Measure quality, peak memory, time to first token, and throughput on your actual workload before keeping a change.
Start with the real bottleneck
“Limited GPU access” can describe several different failures. A model may not fit because its weights consume too much memory, or it may load successfully and then run out of memory as prompts become longer or more users arrive. It may fit but generate too slowly because the accelerator is underutilized, or requests may queue behind an inefficient scheduler. The remedy depends on which resource is exhausted.

| Binding constraint | Typical symptom | First controls to test | Main trade-off |
|---|---|---|---|
| Model-weight memory | The model cannot load, or loading leaves almost no memory for inference | Use a lower-precision weight format supported by the runtime and device; choose a smaller model if necessary | Potential quality change, compatibility limits, and possible latency increase |
| KV-cache memory | Short prompts work, but long contexts or several simultaneous requests trigger out-of-memory errors | Reduce context length or concurrency; reserve memory for the cache before increasing batch size | Less context or fewer simultaneous users |
| Compute | Memory remains available, but token generation is slow and the accelerator is busy | Use an efficient kernel/runtime, an appropriate precision, and batching that keeps the accelerator occupied | More batching can increase cache demand and response waiting time |
| Scheduling and utilization | Individual requests are acceptable, but throughput collapses with uneven arrivals or variable lengths | Use continuous batching and paged cache management where supported; benchmark queueing behavior | More runtime complexity and platform-specific configuration |
Record the model, weight format, accelerator type, available memory, runtime version, context lengths, arrival pattern, and concurrency for every test. A setting that works for one model or request mix is not automatically portable to another.

Outbyte Driver Updater FREEScan for outdated or missing drivers - takes under a minuteDriver Scan →Outbyte PC Repair FREERepair Windows errors before they cause bigger problemsFix Now →Budget memory for weights and the KV cache
Inference memory has at least two major consumers. Model weights are loaded once and remain resident. The key-value (KV) cache stores attention data for tokens already processed in each active request, so its demand grows with sequence length and the number of concurrent requests. A weight-only estimate can therefore look safe while the serving process still fails under realistic traffic.

Estimate the weight footprint
Begin with the precision used to store the weights, then leave headroom for runtime allocations, temporary workspaces, and the KV cache. Hugging Face’s inference documentation illustrates the scale with a 70-billion-parameter Llama 2 model: the example assigns 256 GB to full-precision weights and 128 GB in half precision. Those figures are an illustrative memory calculation in the guide, not a current hardware benchmark or a guarantee for every implementation.
Lowering precision reduces the bytes required for each weight. The official Hugging Face wording is: “Quantization reduces the size of model weights by storing them in a lower precision.” The reduction can be the difference between loading a model and failing at startup, but it does not eliminate cache memory or other runtime allocations.
Include cache demand in the budget
For each active sequence, cache use is affected by the model’s architecture, number of layers, attention dimensions, token count, and the cache precision used by the runtime. You do not need a single universal formula to make a safe decision: measure peak allocated memory while varying context length and concurrency, and keep enough reserve that normal bursts do not cross the device limit.
- Test a short, medium, and maximum intended prompt length.
- Repeat each test at the concurrency levels your service expects, rather than at one request only.
- Watch peak memory during both prompt processing and token generation; the high-water mark can occur at different phases.
- Record out-of-memory events as a capacity failure, not merely a transient software error.
Use quantization deliberately
Quantization stores weights in a lower-precision representation. The immediate benefit is a smaller weight footprint, which can allow a model to run on a device with less memory. The result is not universally faster: Hugging Face cautions that quantization can increase latency in some configurations, so lower memory use must be verified against actual response time.

Choose a format your stack supports
- Confirm the model’s published weight format and the precision you intend to use.
- Check that your inference runtime has an implementation for that format on the exact accelerator backend you plan to run.
- Load the quantized model with the same representative prompts used for the unquantized baseline, if a baseline fits.
- Compare output quality, peak memory, time to first token, and steady-state generation speed.
- Keep the lower-precision version only if its quality and latency meet your application’s limits.
An 8-bit configuration is a documented example in the Hugging Face guide, but the appropriate choice depends on model architecture, device, kernels, and runtime support. A format accepted by one backend may be unsupported or slower on another. Treat compatibility as a prerequisite, not an optimization to discover after deployment.
Separate fit from speed
Quantization solves a weight-capacity problem first. If the process still runs out of memory when users send long prompts, the remaining pressure is likely the KV cache. If memory is comfortable but token rate falls, the quantized kernels or dequantization path may be the limiting factor. Keep these diagnoses separate so that you do not keep reducing precision when context or scheduling is the actual cause.
Control KV-cache growth
The cache grows as requests accumulate tokens and as more requests are active. Context limits and concurrency limits are therefore direct memory controls.
Do these 3 things before closing this tab:
1Fix the driver behind crashes, sound loss and screen glitches2Repair Windows errors before they cause bigger problems3Scan for outdated or missing drivers - takes under a minuteSet a context limit based on real requests
Measure the prompt and expected output lengths your application actually sends. Set a maximum that covers required use cases rather than inheriting an unnecessarily large model limit. A shorter maximum context lowers worst-case cache demand, but requests that exceed it must be rejected, truncated, summarized, or routed to a different workflow; choose that behavior explicitly.

Cap concurrency before increasing batch size
Batching combines work from multiple requests and can improve accelerator utilization, but every active request adds cache demand. If memory is already tight, increasing the batch can produce an out-of-memory failure even when each request succeeds alone. Test concurrency as a controlled variable and stop at the point where throughput gains are outweighed by memory pressure or queueing delay.
Handle long and short requests fairly
Variable-length traffic can leave fragmented or poorly utilized cache space in a naive allocator. A runtime with paged cache management can allocate cache in blocks and reuse available space more efficiently. This improves management of uneven request lengths; it does not create additional physical memory, and it cannot make an over-capacity workload safe without limits.
Use a serving runtime built for dynamic workloads
Runtime choice affects how effectively the available accelerator is used. vLLM documentation describes PagedAttention, batching, quantization options, and multiple hardware backends. Hugging Face’s inference optimization material also discusses continuous batching. Both are runtime-level techniques, so verify the current compatibility matrix and configuration documentation for your model, device, and installed version.
Continuous batching
Traditional static batching waits to form a fixed group, which can leave the accelerator idle while requests arrive at different times. Continuous batching admits and removes sequences as they progress, allowing new work to use capacity freed by completed requests. Its benefit is workload-dependent: it is most useful when requests arrive continuously and have varied lengths. Measure queueing and first-token latency as well as aggregate throughput.

Paged cache management
PagedAttention-style management treats KV-cache storage as reusable pages rather than one contiguous allocation per request. This can reduce waste from differing sequence lengths and simplify admission of new sequences. It still requires a cache budget and an eviction or rejection policy appropriate to your service. Do not assume that enabling a feature removes the need for context and concurrency limits.
Validate backend compatibility
- Check whether the runtime supports your accelerator backend and the selected quantization format.
- Confirm that the model architecture and attention implementation are supported.
- Verify that the installed runtime version matches the configuration examples you follow; serving options change over time.
- Test fallback behavior. A silent fallback to a slower kernel can alter latency even when memory use appears correct.
Benchmark the workload you will actually serve
There is no universally optimal combination of precision, context, batch size, and runtime. Compare configurations with the same model, prompts, output limits, hardware, and software versions.
| Metric | What to measure | Why it matters |
|---|---|---|
| Output quality | Task-specific accuracy or human review at each precision | A memory win is not useful if answers no longer meet the requirement |
| Peak memory | High-water mark during prompt ingestion and generation | Reveals whether weights, cache, or temporary allocations threaten stability |
| Time to first token | Request arrival to the first generated token | Captures prompt-processing and queueing delay |
| Generation throughput | Output tokens per second for one request and for a representative concurrent load | Shows whether batching and kernels improve sustained work |
| Capacity limits | Maximum safe context length and concurrency before errors or unacceptable latency | Defines an honest service envelope |
| Compatibility | Successful loading and stable execution on the target backend | Prevents a configuration that works only in a different environment |
A repeatable test sequence
- Warm the runtime so model-loading time is not mixed with request latency.
- Run a single short request to establish a baseline for memory and first-token latency.
- Repeat with longer prompts while holding concurrency constant.
- Increase concurrency step by step, recording peak memory, throughput, and queueing delay.
- Repeat the matrix for each weight format and runtime configuration.
- Include a burst test and a mixed-length test; averages from uniform prompts can hide the failure mode that matters in production.
These are evaluation axes, not guaranteed benchmark results. Publish or deploy only the limits you observed on the intended platform.
A practical optimization sequence
- Describe the service envelope. Write down required context length, expected output length, target concurrency, acceptable first-token latency, and quality criteria.
- Measure a baseline. Capture weight memory after loading, peak memory under representative requests, first-token latency, and generation throughput.
- Classify the failure. A load-time failure points to weight capacity; a long-context or multi-request failure points to cache capacity; high utilization with low token rate points to compute; idle gaps and long queues point to scheduling.
- Reduce weight pressure. Test a lower-precision format that the model, runtime, and device all support. Recheck quality and latency.
- Reduce cache pressure. Set a realistic context ceiling and concurrency cap. Test those controls before raising batch size.
- Adopt cache-aware serving. Evaluate continuous batching and paged cache management when traffic is dynamic and the runtime supports them.
- Retest the full matrix. Keep only changes that improve the required metric without violating quality, stability, or compatibility constraints.
- Document limits operationally. Expose rejected or queued requests clearly, and monitor memory headroom so traffic growth does not turn a safe configuration into an outage.
Troubleshoot common failure patterns
The model will not load
First verify the weight format and available device memory. If the weights alone exceed the budget, use a supported lower-precision representation or a smaller model. Do not attempt to solve a load-time weight failure by changing batch size; batching affects active requests after loading.
Best Value
It loads, then fails on long prompts
Reduce the maximum context length or lower simultaneous request count, then retest. Inspect peak memory during prompt processing and generation. If short prompts remain stable while long prompts fail, the cache—not the static weight footprint—is the likely constraint.
Throughput rises, but out-of-memory errors appear
The batch or concurrency increase is consuming cache faster than the accelerator can hold it. Back off to the last stable level, reserve headroom, and use continuous batching or paged allocation if supported. A higher aggregate token rate is not an improvement if requests fail.
Quantization saves memory but responses are slower
Check whether the backend is using optimized kernels for that format or a slower fallback path. Compare time to first token and generation throughput separately. Keep the quantized configuration when fitting the model is the priority, but do not call it a speed optimization without measurements.
One benchmark looks good, production does not
Uniform, single-request tests omit queueing, bursts, and long-tail context lengths. Re-run with the production request distribution, including simultaneous arrivals and mixed prompt sizes. The safe operating point is the one that remains stable under those conditions, not the peak from an artificial test.
How to choose among trade-offs
| Priority | Prefer | Watch for |
|---|---|---|
| Fit a model on a smaller device | Lower-precision weights and strict cache limits | Quality changes, unsupported formats, and reduced context capacity |
| Lowest first-token latency | Lower queueing, modest concurrency, and a backend with efficient prompt processing | Underutilized hardware and lower total throughput |
| Highest sustained throughput | Continuous batching with a cache-aware allocator and a stable concurrency window | Higher waiting time for individual requests and cache exhaustion |
| Longest supported context | Conservative concurrency and a memory budget dominated by cache capacity | Fewer simultaneous users and slower admission under bursts |
| Broad deployment portability | A precision and runtime combination documented for the target backends | Giving up some memory or speed for compatibility |
The correct configuration is the one that satisfies your quality and latency targets within the measured memory envelope. Weight precision, cache limits, batching, and runtime features solve different constraints; apply them in that order rather than treating any single technique as a universal answer.
