Measure machine-learning ROI by connecting an intended business outcome to a credible baseline, the model performance needed to change that outcome, the full cost of deploying and operating the system, and benefits that can actually be attributed to it. A strong business case separates forecast value from value already demonstrated; model accuracy alone is not ROI.

Start with the business decision, not the model

Write down the decision the investment is meant to support: build or buy a system, expand a pilot, change a workflow, or stop. Define the process and people affected, the period being assessed, and the outcome the project is supposed to improve. Examples include processing time, error and rework rates, throughput, customer or staff satisfaction, revenue, or decision quality.

Record the current result as a baseline before deployment where possible. Without one, it is difficult to tell whether performance changed or to distinguish the project’s effect from other changes in staffing, demand, policy, or operations. The National AI Centre’s Measure return on investment guidance emphasizes that time saved is valuable only when it is redirected to useful work, such as serving customers or improving quality.

Set the minimum useful model performance

Estimate how well the model must perform to produce the intended operational result before committing to full development. For example, a system that flags defects has value only if its detection and false-alarm rates lead to a worthwhile change in inspection work, scrap, or rework. The required threshold depends on the decision being changed and the consequences of errors.

John Hawkins’s 2021 paper on minimum viable models proposes estimating required predictive-model characteristics from how a model will be used, so technical difficulty can be assessed alongside the business case. Treat this as a feasibility question, not a promise that meeting a predictive score will deliver the forecast benefit: Minimum Viable Models for Machine Learning Projects.

Map the route from model output to value

Make the causal chain explicit: model output → changed decision or workflow → operational outcome → financial or mission outcome. Identify what people or systems will do differently at each step, and how that change will be observed. If a link has not been demonstrated, label the resulting benefit as expected or uncertain rather than realized.

For instance, a prediction that maintenance is needed is not itself a cost saving. The case depends on whether the alert reaches the right person, prompts timely action, prevents a relevant failure, and does so at a cost lower than the loss avoided. NIST’s manufacturing-focused procedure for evaluating condition-monitoring systems makes this risk pathway concrete: establish baseline risk, assess detection and mitigation, estimate installation and operating costs and risks, then value the system and analyze the investment. It is an example for industrial monitoring, not a universal template for every ML application: NIST AMS 100-34.

Count the complete lifecycle cost

Include costs required to get the system into useful operation and keep it there—not just model development or cloud compute. A project estimate should account for internal staff time as well as external spending. The National Academies’ 2024 guide is written for state departments of transportation, but its cost-benefit approach and ML implementation cost categories are useful starting points beyond that sector: A Guide for the Evaluation of Transportation Technology and Systems.

Hands-On Machine Learning with Scikit-Learn, Keras, and TensorFlow: Concepts, Tools, and Techniques to Build Intelligent Systems
  • Use scikit-learn to track an example ML project end to end
  • Explore several models, including support vector machines, decision trees, random forests, and ensemble methods
  • Exploit unsupervised learning techniques such as dimensionality reduction, clustering, and anomaly detection
  • Dive into neural net architectures, including convolutional nets, recurrent nets, generative adversarial networks, autoencoders, diffusion models, and transformers
  • Use TensorFlow and Keras to build and train neural nets for computer vision, natural language processing, generative models, and deep reinforcement learning
  • Discovery and data: project labor; data access or rights; collection, cleaning, labeling, storage, and sharing.
  • Build and operate: developer and consultant time; software and licenses; compute for training and serving; infrastructure; integration and workflow redesign.
  • Assurance and adoption: testing, security, governance, deployment, user training, and change management.
  • Ongoing work: human review and exception handling; monitoring, drift response, retraining, maintenance, and continuing oversight.
  • Opportunity cost: what the team cannot do while its people, budget, or infrastructure are committed to this project.

Estimate costs over the same period as benefits. A one-time pilot cost compared with a recurring benefit can make a case look artificially attractive if it leaves out ongoing support, retraining, or oversight.

Estimate benefits without double-counting

Monetize benefits only where there is a defensible connection to the project and a reasonable way to estimate the value. Depending on the use case, that may include:

  • Staff capacity released and productively redeployed, or labor expense genuinely reduced.
  • Fewer errors, defects, losses, or instances of rework.
  • More output or customers served with available capacity.
  • Revenue or retention linked to changed targeting or service, with uncertainty made explicit.
  • Reduced expected losses when both probability and severity can be supported.

Do not count the same benefit twice. If hours saved are valued as added output, do not also count those same hours as cash savings. Revenue, retention, and productivity can be difficult to assign to AI alone; where attribution is weak, present a range or keep the outcome qualitative. The National AI Centre cautions that saved time creates value only when used productively.

Keep quality, consistency, decision confidence or speed, satisfaction, and other strategic outcomes visible even when assigning them a monetary value would be speculative. A financial ratio cannot capture every mission or societal outcome.

Choose the financial measure that fits the decision

For a quick, single-period screen, use undiscounted ROI:

ROI (%) = (total benefits − total costs) ÷ total costs × 100

For a multi-year case, account for when costs and benefits occur. Discounting converts future amounts to present value; state the discount-rate assumption, analysis period, and which costs and benefits are inside the boundary. The National Academies guide describes three related measures:

Measure Calculation or interpretation What it helps answer
Net present value (NPV) Present-value benefits minus present-value costs. What is the project’s absolute contribution in today’s value?
Benefit-cost ratio Present-value benefits divided by present-value costs. A ratio above 1.0 may indicate economic efficiency under the guide’s framing. How much present-value benefit is estimated for each unit of present-value cost?
ROI Discounted net benefits divided by discounted costs, multiplied by 100. A value above 0% may indicate economic efficiency under the guide’s framing. What is the estimated net return relative to cost?

These are decision aids, not guarantees of realized returns. The same underlying estimates can produce different answers because NPV expresses an absolute present-value contribution, the ratio compares benefits with costs, and ROI expresses net return as a percentage. Results depend on the scope, timing, discount rate, and assumptions about uncertainty and risk. The thresholds above are the guide’s benefit-cost framing, not observed ML success rates or universal project targets.

Compare ML with realistic alternatives

ROI is useful only in relation to the choice being made. Compare the ML proposal with using an existing tool, improving the current process without ML, and doing nothing. For each option, assess:

  • Lifecycle cost and time to useful value.
  • Expected benefit and confidence that the change can be attributed to the option.
  • Required performance and technical feasibility.
  • Data readiness, integration effort, and ongoing maintenance.
  • Operational risks and the cost or consequences of errors.
  • Effects on people, process quality, and available capacity.
  • Reversibility: whether the organization can stop, change course, or fall back safely.

The minimum-model approach encourages balancing expected business return against the difficulty of achieving required performance. In safety- or reliability-sensitive settings, baseline risk and the costs and risks of installation and operation also belong in the comparison.

Test whether benefits are attributable and sustainable

Compare post-deployment outcomes with the baseline using an evaluation design suited to the process. A simple before-and-after comparison may be misleading if demand, staffing, policies, or other systems changed at the same time. Where practical, use a credible comparison group, phased rollout, or another design that helps separate the system’s contribution from other influences. Record how the comparison was made and what it cannot establish.

Track business outcomes beside technical measures. Accuracy by itself does not establish value: the right technical metric depends on the task and the operating context. Document the test set, measurement method, and why the selected metric reflects the real task. For consequential uses, inspect subgroup performance, data representativeness, validity beyond training conditions, reliability, robustness, and the consequences of different errors.

NIST’s AI Risk Management Framework Measure Playbook recommends documenting test sets, metrics, and methods, and reassessing whether measures remain appropriate when settings or data change or model drift occurs: NIST AI RMF Playbook: Measure. The framework also highlights that AI risks and benefits can arise from technical properties interacting with how a system is used, who operates it, other systems, and the social context. An offline score is therefore not a substitute for monitoring the deployed workflow and its effects.

For a changing use case or operating environment, define who reviews performance, risk, and costs, how often they do so, and what conditions trigger investigation, retraining, rollback, or shutdown. NIST announced TEVV-Athlon as an initial public draft on August 7, 2026, with comments due October 6, 2026; it is draft guidance rather than a final standard. Its customizable four-stage assessment method is intended to produce evidence about system performance and impact while minimizing negative effects: NIST TEVV-Athlon announcement.

Make the estimate auditable

A decision-ready ROI case should show its working, not just a headline percentage. State the baseline, period, alternatives, minimum useful performance, lifecycle cost boundary, benefit assumptions, attribution method, discount rate if used, and material uncertainties. Separate measured outcomes from forecasts, and report important non-financial results alongside the financial metrics.

No general-purpose ROI benchmark or universal success threshold for ML projects is established by the cited sources. A project-specific estimate is more useful when readers can see the assumptions and how the conclusion would change if costs, benefits, timing, or attribution turn out differently.
