Consider PPO-based RLHF when you can train and validate a reward model and need iterative policy updates driven by its scores. These are not three competing methods at the same level: RLHF is the broader feedback-based approach, PPO is an optimization algorithm often used within an RLHF pipeline, and DPO is a separate preference-optimization method.
Neither approach is a universal winner. Choose by the feedback data and training loop you can support, then compare results on the behavior and safety criteria that matter for your deployment.

What DPO, PPO, and RLHF mean
RLHF is the feedback-based approach
Reinforcement learning from human feedback (RLHF) describes a family of methods for shaping model behavior using human preferences. In OpenAI’s InstructGPT example, the workflow starts with supervised fine-tuning (SFT) on demonstrations, gathers comparisons between model outputs, trains a reward model to predict labeler preferences, and then optimizes the language-model policy using PPO. OpenAI’s InstructGPT account describes this particular pipeline; it is an example, not a requirement that every RLHF system use exactly these stages.

Proximal policy optimization (PPO) is the reinforcement-learning algorithm used to update the policy in that InstructGPT pipeline. The reward model supplies a learned signal about which outputs are preferred; PPO is the method used there to optimize the policy against that signal. So “PPO versus RLHF” is not a like-for-like comparison.

DPO optimizes directly from preference pairs
Direct preference optimization (DPO) trains on prompts paired with a preferred and a less-preferred response. Its classification-style objective comes from a preference-optimization formulation. In the method described in the original paper, DPO removes the conventional separately trained reward model and PPO policy-optimization loop; it still depends on useful preference data and careful evaluation. Rafailov and coauthors’ 2023 paper describes the method and its experimental results.
Which method should you consider first?
| Your situation | Starting point | Reason and caveat |
|---|---|---|
| You have a static dataset of prompts, preferred responses, and less-preferred responses, and want a relatively direct preference-tuning experiment. | DPO | It is designed to optimize from preference comparisons without the conventional separate reward-model-plus-PPO loop. Data quality and held-out evaluation still determine whether the result is useful. |
| You can generate policy outputs during training, validate a reward model against the preferences you care about, and need iterative reward-driven updates. | PPO-based RLHF | This supports policy optimization against a learned reward signal. It also requires the reward model, generation loop, evaluation, and implementation work to be sound. |
| You have demonstrations but no pairwise preference judgments. | Establish an SFT baseline first | InstructGPT used supervised demonstrations before preference training, and OpenAI’s DPO guide recommends SFT on some preferred responses before DPO. Demonstrations alone do not provide the preferred-versus-less-preferred pairs DPO uses. |
| You cannot tell which method will improve the target behavior. | Run a task-specific comparison | Match the starting model, preference data, and evaluation as closely as practical. Track safety and capability regressions as well as the target preference score. |
What the evidence does—and does not—show
The published comparisons do not establish a general ranking. The DPO paper reports better sentiment control than PPO-based RLHF, and matching or improved response quality on its summarization and single-turn dialogue experiments. A later comparative study reports PPO outperforming DPO across its own evaluated settings, including challenging code-generation tasks. Those findings concern the studies’ tasks and configurations, not every model, dataset, or deployment.

- InstructGPT was a specific result. OpenAI reported that labelers preferred outputs from its 1.3B InstructGPT model over outputs from a 175B GPT-3 model. This does not show that smaller models generally outperform larger ones. The same account says the training procedure used less than 2% of the compute and data relative to model pretraining; that comparison is specific to the reported procedure, not a general cost estimate for current RLHF or DPO runs. OpenAI, 2022.
- DPO’s reported wins were task-specific. Rafailov and coauthors reported the sentiment-control, summarization, and single-turn dialogue results described above in their 2023 paper. Their abstract characterizes DPO as stable, performant, and computationally lightweight; treat that as the authors’ characterization of their method and experiments rather than a guarantee for a new training run. DPO paper.
- PPO’s reported wins were also task-specific. The 2024 OpenPsi Project study found PPO ahead of other methods in its evaluated testbeds. It identifies advantage normalization, large batch size, and exponential-moving-average reference-model updates among factors in its PPO results. These observations are study-specific, not a universal recipe or promise of superiority. Comparative study.
How to make a fair comparison for your use case
- Define the behavior you want to change. Specify the prompts and response qualities that matter—for example, adherence to a desired tone or the quality of summaries—before selecting a training method.
- Check what feedback you actually have. DPO requires preferred and less-preferred responses for prompts. A PPO-based RLHF setup needs preference feedback sufficient to train a reward model, plus a way to validate that model against the target preference.
- Set a baseline. If you have demonstrations but not comparisons, evaluate an SFT model first rather than treating demonstrations as pairwise preference data.
- Keep the comparison controlled. Where practical, hold the starting model and preference data constant, make compute budgets comparable, and use the same held-out prompts and scoring criteria. Record differences in training procedure so results remain interpretable.
- Evaluate beyond the training signal. Check whether target behavior improves on held-out cases, and look for safety or general-capability regressions. In its InstructGPT account, OpenAI discusses an “alignment tax” and a mitigation using a small amount of original training data; that is a concern to measure, not evidence that every run incurs the same regression.
- Report the scope of the result. State the model, data, method, evaluation set, and relevant training conditions. A win on one task is evidence for that task and setup, not a blanket verdict.
Implementation considerations
Preference data shape
OpenAI’s DPO guide describes training examples with a prompt, a preferred output, and a non-preferred output. It documents text-input/text-output support and lists summarization and tone or style as use cases. The guide also states that OpenAI’s fine-tuning platform is winding down and unavailable to new users, while existing users can create jobs for the coming months. Availability can change, so check the current DPO guide before planning around that hosted option.
Library support
Hugging Face TRL documents a DPOTrainer and includes an example using a Qwen 3 0.6B model with an UltraFeedback binarized dataset. That documents an implementation path; it is not a benchmark recommendation or evidence that the example model is best for a particular task. See the TRL DPO Trainer documentation.

A concise decision rule
- Choose DPO as the first experiment when you have representative preference pairs and want to optimize directly from them.
- Choose PPO-based RLHF when a validated reward model and iterative generation-and-update loop fit your needs and resources.
- If you lack pairwise judgments, begin with a demonstration-based baseline and decide how to obtain or evaluate preference feedback before choosing between these preference-optimization approaches.
