How to Choose a Cloud GPU Instance for AI Training or Inference

A practical method for choosing a cloud GPU instance: define the workload, estimate memory, check multi-GPU needs and availability, then compare total cost with a representative pilot.

Choose a cloud GPU instance by working outward from the job: determine whether it is training or inference, estimate the workload’s peak memory and performance needs, decide whether one GPU is enough, then verify software support, regional capacity, and total cost. A newer GPU name or a higher GPU count alone does not make an instance the right fit.

1. Define the workload before comparing instances

Write down what the instance must do before looking at VM families. Training and inference have different resource profiles, and even workloads in the same category can vary substantially.

  • Task: training, fine-tuning, batch inference, or a continuously available inference service.
  • Model and software: model architecture and size, framework, container or image, and accelerator support.
  • Memory and data: peak GPU memory, dataset size, preprocessing needs, and host-memory requirements.
  • Performance target: training duration, throughput, or inference latency, including expected request concurrency.
  • Operational constraints: job duration, whether it can be checkpointed and restarted, and whether serving demand is steady or intermittent.

Microsoft’s Azure compute guidance likewise frames VM selection around model complexity, data size, and cost constraints. Its recommendations describe Azure offerings; they are not a neutral performance ranking across cloud providers.

2. Decide whether the workload needs a GPU

A GPU is a strong candidate for neural workloads that benefit from accelerator parallelism, especially generative or otherwise complex model training and inference. But “AI” does not automatically mean “GPU”: a small model may run acceptably on CPU, and CPU instances can also suit preprocessing or postprocessing that does not benefit from GPU acceleration.

For inference, size around the service target rather than copying the configuration used to train the model. A small, lightly used service may need less GPU capacity than a large training job. Azure’s guidance identifies CPU instances for some small-model inference, while recommending GPU options for generative and complex-model inference. Test the choice against representative inputs and traffic rather than relying on category labels alone.

3. Estimate memory and compute needs

GPU memory is often a practical first filter: the working set must fit, with room for runtime overhead. The required amount depends on the model and how it is used; there is no universal memory figure that can be inferred from model size alone.

For training

Include model weights, activations, optimizer state, batch size, and framework or runtime overhead. Larger batches may improve throughput but use more memory. If the workload uses long sequences or large inputs, account for their additional activation memory.

For inference

Account for model weights, concurrency, input or context length, and runtime overhead. For models that use a key-value cache, include its memory use as context length and the number of simultaneous requests increase. A configuration that fits one request may not meet the target under real concurrency.

Compare per-GPU memory and the whole host

Check GPU architecture, memory per GPU, GPU count, host RAM, CPU, storage, and network—not just the accelerator name. Microsoft’s Azure VM documentation gives two examples of distinct capacity classes: NCasT4_v3 configurations offer up to four NVIDIA T4 GPUs with 16 GB each, while NC A100 v4 configurations offer up to four NVIDIA A100 PCIe GPUs with 80 GB each. These are published configuration specifications, not benchmarks, availability guarantees, or proof that one family is the better choice for a particular workload. See Microsoft’s GPU VM size documentation for the listed configurations.

Once a candidate appears to fit, validate it with a pilot using the intended model, data, batch or context length, and serving pattern. Measure whether it meets the performance target and whether memory headroom remains; published hardware specifications cannot predict the result for your particular software and workload.

4. Choose one GPU or multiple GPUs

If one GPU can hold the workload and meet its performance target, extra accelerators may add cost without adding useful capacity. More GPUs help only when the workload and software can use them effectively.

For distributed training, GPU count is only part of the decision. The framework must support the chosen parallelism strategy, and communication between GPUs or nodes can affect performance. Microsoft recommends Azure training SKUs with RDMA and GPU interconnects when high-speed GPU-to-GPU data transfer is needed. For inference, its guidance says InfiniBand is unnecessary; that does not mean every multi-GPU or multi-node inference design can ignore its networking requirements.

Check the instance’s GPU interconnect, network capability, and multi-node support against the actual distribution plan. Do not pay for a high-speed interconnect unless the job can use it, but do not assume a large GPU count will scale well without considering communication.

5. Verify software, region, and capacity

A technically suitable GPU is not useful if the required software stack or service cannot use it. Before committing, verify these details for the specific instance, region, and deployment path:

  • GPU architecture and compatibility with the framework and any custom operations.
  • Driver and CUDA versions supported by the selected framework build or container.
  • Whether the managed machine-learning service supports that VM size.
  • Whether the size is offered in the intended region, and whether quota and current capacity are sufficient.
  • Whether orchestration, storage, and data-location choices fit the deployment.

Microsoft notes that supported VM sizes can differ by Azure Machine Learning service and region, and documents CUDA compatibility by GPU family. Check its Azure Machine Learning compute selection guidance for the service you intend to use, then confirm current regional availability and quota. Catalog listings do not guarantee that capacity is available when you need it.

6. Compare cost per useful result

Compare the cost of completing the job or serving the target traffic—not only the advertised hourly GPU rate. For training, a useful measure may be cost per completed run or training step; for inference, compare cost per request or token while meeting the required latency and throughput. A faster instance may finish a job sooner, but without a representative measurement you cannot infer which option is cheaper overall.

Include VM runtime, startup and idle time, attached storage, data transfer or networking charges where applicable, and licensing if relevant. Use the provider’s current calculator with the same region, operating system, VM size, usage term, storage, and network assumptions for every candidate. Prices and terms change, so a comparison without a dated, location-specific estimate can become misleading.

Match the pricing model to interruption tolerance

  • Training that can resume: low-priority or spot capacity may reduce cost, but treat it as interruptible. Use checkpoints, retries, and a recovery plan for reclaimed capacity.
  • Always-on or latency-sensitive inference: compare the cost of a provisioned instance with smaller or fractional-GPU choices and autoscaling, while testing response time under representative traffic.
  • Steady, predictable demand: evaluate reservations or other commitment options against the expected utilization and term.
  • Jobs with idle periods: consider scheduled shutdown, autoscaling, or termination policies so unused capacity does not keep running.

Microsoft’s Azure Machine Learning cost-management guidance describes controls including low-priority VMs, autoscaling, termination policies, scheduled shutdown, reservations, and same-region deployment. Their suitability and savings depend on the workload, provider terms, region, and actual utilization.

7. Compare the remaining candidates on equal terms

Once you have filtered out choices that fail memory, software, or availability requirements, compare the viable instances against the same workload and assumptions.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
Comparison area What to check
Workload fit Training or inference; latency or throughput target; framework support.
Accelerator capacity GPU architecture, memory per GPU, GPU count, and fractional-GPU availability.
Scaling path GPU interconnect, RDMA or other network capability, and multi-node support.
Host and data path CPU, system RAM, storage performance, and data locality.
Availability Region and service support, quota, and current capacity.
Cost and risk Regional price, idle time, storage and networking charges, commitment or interruption terms, and recovery behavior.

Cloud catalogs also include AI accelerators that are not GPUs. For example, AWS documents GPU instances separately from Trainium training instances and Inferentia inference instances in its EC2 accelerated computing documentation. These alternatives matter only if the model, framework, and deployment stack support them; their presence in a catalog does not establish that they fit a particular workload.

Make the final choice with a representative pilot

  1. Shortlist instances that fit the workload’s memory, software, region, and quota requirements.
  2. Run the same representative job or traffic pattern on each viable candidate, including the intended batch size, context length, and concurrency.
  3. Record the outcome that matters: completed training time, cost per run, or inference latency and throughput at the target load.
  4. Include startup, idle, storage, and networking costs in the comparison, then choose the least costly option that reliably meets the target.

Instance families, prices, quotas, and regional supply change. Recheck provider documentation and live pricing before deployment, and treat GPU specifications as inputs to a test—not a substitute for one.
