Can Synthetic Shoppers Really Test Your Recommender?

Synthetic shoppers are useful for controlled recommender tests only when their relevant behaviors are validated against people. See what to test and where simulation’s limits begin.

Yes—but only for specific, validated tests. A synthetic shopper can help you compare recommender versions, probe edge cases, and repeat controlled scenarios. A conversation that sounds human, however, does not prove that the simulated shopper chooses, expresses preferences, or responds like the people your product serves. Validate those behaviors against relevant human evidence before treating simulation results as evidence about customers.

What can a synthetic shopper tell you?

A simulated user gives a team a repeatable way to test how a recommender behaves under chosen conditions. That can make it useful for finding failures, comparing variants, and exploring situations that are difficult to reproduce consistently with people.

But the result is evidence about the system interacting with that simulator—not automatically about real customers. If a simulator’s preferences or feedback differ from human behavior, a recommender that performs well in simulation may not perform well for the intended audience. The central question is therefore not whether the shopper sounds plausible, but whether it reproduces the human behavior relevant to the decision you are testing.

Yoon, He, Echterhoff, and McAuley’s 2024 NAACL study proposed a protocol to assess how well large language models emulate human behavior in conversational recommendation and to expose deviations. The authors describe synthetic users as “cost-effective proxies for real users” in this setting, with the qualification that their protocol measures behavioral emulation rather than assuming it.

Check five behaviors, not just the final recommendation

The 2024 protocol breaks conversational recommendation into five user tasks. A simulator can be credible on one and unreliable on another, so evaluate the behavior your product actually depends on.

  1. Choosing items to discuss: Does the simulated shopper bring up the kinds of items people in the relevant population would discuss?
  2. Expressing binary preferences: Can it communicate a clear like or dislike in a way that matches the human behavior being modeled?
  3. Expressing open-ended preferences: Does it describe tastes or constraints in the ways people actually do, rather than producing fluent but unrepresentative explanations?
  4. Requesting recommendations: Does it ask for suggestions at the points and in the manner relevant to the intended interaction?
  5. Giving feedback: Does its response to recommendations resemble the feedback people provide, including when a suggestion misses the mark?

Compare simulator behavior with human behavior for the same task and relevant population. A single overall score can hide a failure in one of these areas; inspect the specific interactions that matter to the recommender’s use case.

Test more than the easy, full-history case

Performance with a complete user profile does not establish performance when a history is sparse or preferences change. AgentRecBench, a NeurIPS 2025 benchmark, illustrates three useful scenario types: standard recommendation, evolving interests, and cold start for users or items with limited history.

Standard recommendation

This is the familiar case: recommend from an established user history. It is a useful baseline, but it cannot by itself show that the system will handle new users, new items, or changing tastes.

Evolving interests

AgentRecBench’s evolving-interest setup examines longer-term preference over a three-month window and emerging patterns over a one-week window. These are benchmark-specific test windows, not universal definitions of long- and short-term interest. The practical lesson is to distinguish a durable preference from a newer one when that difference matters to the product.

Cold start

Cold-start scenarios test recommendations when user histories or item histories are sparse. Include both sides where relevant: a system may have little evidence about a new user, a new item, or both.

Where simulation fits in the evidence ladder

A recommender-simulation survey frames simulation as an intermediate approach between offline counterfactual evaluation and online controlled experiments. Each method answers a different kind of question:

  • Offline evaluation assesses a policy using existing data and specified assumptions; it does not recreate a live interaction with a new user.
  • Simulation permits controlled, repeatable what-if tests, but its conclusions depend on how well the simulator reflects the people and behaviors of interest.
  • Studies with people or online controlled experiments bring evidence closer to actual human use, though they require recruiting participants or conducting a live test.

Use synthetic shoppers to screen changes and diagnose behavior. For consequential product decisions, corroborate simulated findings with evidence from real users or online controlled experiments when practical. State what population, tasks, and conditions the simulation covered, and avoid assuming the result transfers beyond them.

How to judge an evaluation report

Before relying on a result, look for details that show what was tested and how dependable the comparison is.

  • Behavioral fidelity: Does the study compare the simulator with human behavior on the relevant tasks, including preference expression and feedback?
  • Scenario coverage: Does it test only established histories, or also evolving interests and sparse user or item histories when those are relevant?
  • Evidence proximity: Is the claim based on offline replay, simulation, recruited participants, or a live controlled experiment?
  • Uncertainty and reproducibility: Are repeated runs, uncertainty or statistical significance, data splits, and implementation details reported?

Reporting limitations should be read in context. AgentRecBench’s 2025 author checklist says that its results do not report statistical-significance information; it also notes evaluation across three LLM architectures rather than repeated trials because of API cost considerations. That describes the paper’s experiments, not every simulator study. ORBIT, meanwhile, offers a standardized recommendation benchmark with public datasets and reproducible splits; its ClueWeb-Reco dataset is synthetic data derived from user-consented browsing data. It provides benchmark context, not proof that LLM shoppers accurately emulate people.

The practical verdict

A fake shopper can help test a recommender, provided the test is narrow enough to validate. Check the behaviors that matter, vary the conditions that reflect intended use, and compare simulated behavior with relevant human evidence. Treat the result as controlled diagnostic evidence—not a guarantee of how real customers will respond.
