Can Seven ESP32-S3 Boards Run an LLM? Inside the Cluster

A seven-board ESP32-S3 cluster demonstrates sequential, ternary-quantized LLM inference across microcontrollers—but its cited weights produce random tokens.

Yes—but the seven-board ESP32-S3 build is an engineering demonstration of distributed model inference, not a useful chatbot. One board handles tokenization and embeddings, while six boards process transformer layers in sequence. The project documentation describes a pipeline for fitting quantized weights across constrained microcontrollers; the cited overview says the included weights are only partially trained and produce random tokens.

What the seven-board cluster does

The project uses one ESP32-S3 as a master and six as compute nodes. It is a sequential pipeline rather than a cluster that splits requests across boards for parallel serving.

  • The master tokenizes the input and looks up embeddings.
  • Each compute node processes successive transformer layers, then sends the resulting hidden-state vector to the next node over a high-speed SPI daisy chain.
  • The last compute node returns the vector to the master, which performs final normalization and samples the next token.

The repository’s architecture diagram assigns four transformer blocks to each compute node, for 24 layers across six nodes. It describes RMSNorm, ternary attention and MLP layers, rotary position embeddings, and a PSRAM-backed key-value cache on the compute nodes. The master uses INT4 embeddings. See the project repository for the implementation and workflow; its README and setup instructions can change.

How ternary weights make the model fit

The storage strategy is ternary quantization: each weight is represented by one of three values, −1, 0, or +1. The project describes this as 1.58-bit quantization. It reduces weight storage enough to assign a small group of layers to each node, but it does not mean the full model sits in RAM.

Pinggy Blog’s September 29, 2026 overview reports approximately 3.82 MB per transformer layer and about 15.3 MB for four layers, fitting within a 16 MB flash partition. These are project-reported figures, not independent measurements. The master’s embedding setup is also distinct: the project documentation identifies INT4 embeddings and a pruned 32K-token vocabulary.

Why adding boards adds latency

Each node must finish its part of the computation before the next node can continue. Adding nodes increases the number of layers the system can hold, but also lengthens the serial path for every generated token.

  • ESP32-S3-N16R8 cable can be used: USB Type A to Type-C cable or CC cable Note the distinction between the commonly used USB A port to Type-C cable that can only be charged, which cannot be used for communication between YD-ESP32-S3 and the host.
  • USB-to-UART Port and ESP32-S3 USB Port (either one or both), default power supply (recommended)

The cited overview identifies repeated flash reads as a bottleneck: the whole model cannot reside in RAM, so layer weights must be read from flash during inference. SPI carries the hidden state rather than the layer weights; the overview reports 896 FP32 values, or about 3.5 KB, per hop. The small transfer does not remove the sequential compute and flash-access costs.

Pinggy Blog reports about 1.3 seconds of inference per node and approximately 1.5 W while generating. Its several-seconds-per-token figure is an estimate derived from the serial-node timing, not a measured end-to-end benchmark. The article notes that the repository does not provide a tokens-per-second table and points to an on-device /bench command for measuring throughput on a particular build.

Is it usable as an LLM?

Not as a reliable conversational model based on the cited material. The technical overview says the shipped quantization-aware training is partial and the model emits random tokens; the project’s workflow notes are cited for that limitation. The demonstrated result is the hardware and inference pipeline, not established language-model quality.

That distinction matters when judging the project: successfully passing hidden states through 24 transformer blocks across seven boards proves a constrained deployment architecture can be assembled, but it does not establish coherent responses, useful task performance, or competitive throughput.

What you need to reproduce the build

The cluster requires seven ESP32-S3 boards, but board names alone are not enough to confirm compatibility. The project repository includes a workflow guide for wiring, flashing firmware, and preparing the model. Check its current flash and PSRAM requirements and pin configuration against the exact board revision before buying or assembling hardware.

  1. Read the repository’s current workflow for the required board memory configuration and wiring.
  2. Prepare one master and six compute nodes, preserving the documented node order.
  3. Flash the firmware and follow the project’s model-preparation procedure.
  4. Run the device’s /bench command if you need a measured throughput figure for your assembled cluster.

For SPI faults, the cited overview recommends checking signal integrity and clock behavior with a logic analyzer. It is optional troubleshooting equipment, not a required cluster component.

ESP32-S3 demonstration or conventional BitNet inference?

These paths answer different goals. The ESP32-S3 repository is relevant when the objective is to reproduce a tiny, distributed microcontroller pipeline. Microsoft’s official BitNet repository is a software reference for CPU/GPU inference. The available project material does not establish a product-level performance comparison between them.

  • Choose the ESP32-S3 project to study memory-constrained deployment, ternary weights, SPI handoffs, and the trade-off between model capacity and serial latency.
  • Look at conventional BitNet inference when your goal is to run the framework on a CPU or GPU rather than build the seven-board embedded pipeline.

Compare the options by compute platform, model quality, throughput, memory capacity, power, and setup complexity. The cited sources do not provide equivalent benchmarks across those dimensions, so a direct winner cannot be established from them.
