AI Workloads: How to Build High-Performance Object Storage

Object storage can anchor AI datasets and artifacts, while measured use of parallel clients, caches, locality, and file systems addresses specific performance bottlenecks.
Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

For most AI platforms, object storage is the durable home for datasets, checkpoints, and trained models—not necessarily the fastest path for every training read or checkpoint write. Start with measured workload behavior, then combine an object repository with client-side parallelism, a cache or staging tier, and, where latency or metadata concurrency demands it, a parallel file system.

How should you design storage for an AI workload?

Design the full path from stored data to accelerator consumption and back to recoverable checkpoints. A scalable object repository can serve as the system of record, while workload-specific access layers address bottlenecks between storage and compute. That avoids treating object storage and file storage as mutually exclusive choices.

As an Amazon Associate I earn from qualifying purchases.

  1. Keep durable source data and artifacts in object storage. Store raw or prepared datasets, checkpoints, and trained models in a central object repository that can scale with the corpus and support bulk access.
  2. Choose a client or adapter that matches the access pattern. Use the native object API where it fits, and make request concurrency, connection reuse, and retry behavior deliberate.
  3. Add a cache or staging tier for data that is reused. Cache hot data close to compute when repeated reads make the additional capacity and operations worthwhile. Local NVMe can serve as a staging or cache tier; it does not replace durable central storage.
  4. Evaluate a parallel file system for demanding phases. Consider one when low latency, metadata concurrency, POSIX behavior, small-file access, or intensive training and checkpoint I/O exceeds what the object-based path can support.
  5. Measure and tune the complete pipeline. Track data loading, preprocessing, accelerator consumption, checkpoint writes, and recovery reads—not just storage bandwidth in isolation.

Cloud providers describe object storage as a central repository for AI datasets and model artifacts, while also documenting caches and parallel file systems for workloads with different performance needs. Those are complementary roles, not a universal ranking of storage types.

What should you measure before choosing a tier?

Training typically reads samples, preprocesses them, updates model parameters, and periodically writes checkpoints. Effective throughput is limited by the slowest stage. A fast storage device will not solve a CPU-bound preprocessing step, a constrained network path, or a client that issues too few requests.

  • Access pattern: sequential or random reads; large or small objects/files; read, write, or mixed activity.
  • Concurrency: simultaneous readers and writers, metadata operations, and request rates per prefix or namespace.
  • Reuse and working set: whether jobs revisit the same samples across epochs, whether multiple jobs share data, and how the working set compares with cache capacity.
  • Training phase: initial dataset loading, steady-state input, inference, checkpoint creation, or checkpoint recovery.
  • Checkpoint profile: checkpoint size, write frequency, load frequency, acceptable interruption, and required recovery time.
  • Placement: distance between compute and storage, including zone or region, and the actual network route used by workers.
  • Operational constraints: required API or POSIX semantics, compatibility with the platform, durability and recovery needs, operational effort, and total cost.

Collect end-to-end throughput and latency alongside CPU use, network utilization, request rates, throttling or errors, cache hit behavior, and checkpoint duration. Run representative jobs and data distributions. A benchmark using a single large sequential file may say little about a workload that opens many small files or performs random reads.

Which storage layers fit which access patterns?

Layer Access model Where it can fit What to validate
Object storage Object/API requests Durable central repository for datasets, checkpoints, and trained models; bulk reads and writes at scale. Request concurrency, object-size distribution, client behavior, latency, and whether the workload needs file semantics.
Mounted object interface File-like interface backed by object storage Workloads that benefit from a file-oriented interface while retaining an object store as the backing repository. Actual semantics and performance for the application. A mount does not automatically provide full POSIX behavior or parallel-file-system performance.
Cache or local staging Local or nearby copies of selected data Repeated reads, hot datasets, or staged data close to compute where reuse justifies the extra tier. Working-set size, cache hits, freshness and consistency needs, capacity, node-local bottlenecks, and management overhead.
Parallel file system Shared file system, often with parallel access Phases needing low latency, high metadata concurrency, POSIX behavior, or intensive small-file and checkpoint I/O. Application compatibility, aggregate and per-node throughput, metadata behavior, capacity scaling, placement, operations, and cost.

Google Cloud identifies Managed Lustre for some low-latency and I/O-intensive cases and cautions that Cloud Storage FUSE is not suitable for certain low-latency, small-file, or random-I/O workloads. The appropriate choice depends on the specific service configuration and workload; a file-system interface over objects should not be assumed equivalent to a fully POSIX parallel file system.

How can you make object-storage reads faster?

Use concurrency deliberately

For large objects, test concurrent byte-range or multipart downloads. Where possible, align range reads with the object’s original multipart boundaries. For REST-based access, reuse HTTP connections rather than paying connection setup costs repeatedly.

AWS’s S3 performance guidance says, “We recommend starting with a single request at a time.” Treat that as a tuning method: establish a baseline, identify the limiting resource, and increase concurrency only when measurements show it helps. More workers can increase throughput, but can also move the bottleneck to network bandwidth, client CPU, request limits, or the destination filesystem.

Handle request scaling and retries

AWS advises implementing high-request-rate strategies when consistent rates reach 3,500 PUT/COPY/POST/DELETE requests per second or 5,500 GET/HEAD requests per second per prefix. These are service-specific guidance thresholds, not guaranteed per-client performance targets. AWS also notes that scaling is gradual and temporary 503 responses can occur as request rates adapt. Ramp traffic rather than starting at peak, monitor errors and request metrics, and follow SDK retry behavior or use exponential backoff for 503 responses.

Cache data only when it is reused

A cache can reduce direct object-store requests and improve access to hot content, but it adds capacity, data-management, and operational considerations. Estimate the working set and measure reuse across epochs or jobs. If data is read once and the cache cannot retain useful hot content, staging may add cost and complexity without reducing training time.

When is a parallel file system worth evaluating?

Evaluate a parallel file system when representative measurements show that object access, a mounted object interface, or caching cannot meet a workload’s needs for latency, metadata concurrency, small-file operations, or intensive shared I/O. The most suitable architecture may use object storage for durable capacity and a parallel filesystem for a high-performance training or checkpoint phase.

Do not make the choice from peak bandwidth alone. Compare latency, throughput per node and in aggregate, metadata operations, capacity growth, data locality, application compatibility, durability and recovery, operational burden, and total cost. A parallel filesystem can improve a constrained phase, but it also introduces another system to size and operate. An object store can simplify the durable repository, but its API and access characteristics may not fit every application.

How should you size storage for GPU training?

Size against measured input and checkpoint requirements for the actual job, not a vendor’s maximum throughput figure or a single per-GPU multiplier. Establish the required data rate at the accelerator boundary, then verify that preprocessing, clients, network, cache, and storage can sustain it together.

Published vendor figures illustrate how strongly performance depends on product, architecture, and measurement scope:

  • Google Cloud states up to 15 TB/s for Rapid Bucket relative to other Cloud Storage products and bucket locations, and up to 2.5 TB/s for Rapid Cache. The accessed documentation did not state a publication year. These are service claims, not cross-vendor benchmark results.
  • Google Cloud’s architecture guidance claims more than 1 TB/s is achievable for a described Cloud Storage FUSE architecture with proper planning. The guidance did not state a publication year; the figure is not a general guarantee for mounted object storage.
  • Google Cloud states that hierarchical namespace provides 8 times higher queries per second for object reads and writes compared with buckets without hierarchical namespace. The accessed documentation did not state a year; this is a product comparison, not an independent benchmark across storage systems.
  • NVIDIA’s DGX SuperPOD Rubin NVL8 reference architecture gives 1.25 GB/s standard and 3.91 GB/s enhanced single-node aggregated system read; 0.63 GB/s standard and 1.95 GB/s enhanced single-rack aggregate system write; 90 GB/s standard and 281.25 GB/s enhanced full-SU system read; and 45 GB/s standard and 140.63 GB/s enhanced full-POD system write. The reference did not state a year. These values apply to its named system scopes and should not be generalized to other hardware or architectures.
  • NVIDIA cites a 4 GB/s-per-GPU read-performance requirement for its automotive and computer-vision examples using high-resolution images, including uncompressed datasets that can exceed 30 TB. The reference did not state a year. This is an example for those workloads, not a default GPU-storage sizing target.

These numbers describe different services, system configurations, and scopes; they are not directly comparable. Use them to understand possible design scales, not as a substitute for testing your own client, network, data, and job.

How should checkpoints shape the design?

Checkpointing is a performance path, not an afterthought. A synchronous checkpoint can pause training while data is written, so its duration and frequency affect end-to-end job time. Recovery also depends on how quickly a large checkpoint can be read back by the required number of workers.

Choose storage and checkpoint strategy based on model size, cluster scale, checkpoint frequency, access pattern, and recovery objective. Measure both write and restore behavior under realistic concurrency. An AWS checkpoint-storage blog describes a large-scale scenario with thousands of accelerators and concurrent loading of terabyte-sized checkpoints taking 10–15 minutes end to end. AWS did not state a publication year in the accessed material; this is a scenario-specific observation, not a general loading-time guarantee.

What is a practical tuning sequence?

  1. Capture a baseline. Run a representative job and record accelerator utilization, input wait time, preprocessing time, storage and network throughput, request/error rates, and checkpoint duration.
  2. Isolate the slow stage. Determine whether time is going to storage latency, request concurrency, the network path, client CPU, preprocessing, metadata operations, or checkpoint I/O.
  3. Change one layer at a time. Test connection reuse, bounded request concurrency, range or multipart reads, caching, staging, or placement independently where practical.
  4. Retest under realistic scale. Include the expected number of workers, concurrent jobs, object sizes, and checkpoint behavior. Watch for throttling, 503 errors, contention, and cache misses.
  5. Compare lifecycle-wide cost and recovery. Account for durable capacity, cache or filesystem capacity, operations, data movement, and time to resume after failure—not just the fastest training run.

The final architecture may use different tiers for different phases: object storage as the durable repository, cache or local NVMe for reused or staged input, and a parallel file system where a measured low-latency or high-concurrency phase requires it. The evidence for a tier is the improvement it produces on the real workload without undermining recovery, compatibility, or operational goals.
