Zero-shot classification lets a pretrained model assign labels it was not fine-tuned on, but the resulting score is not automatically a trustworthy probability. Calibration asks whether a stated confidence matches observed accuracy; conformal prediction instead produces a label set designed for a chosen marginal coverage rate. A decision policy then determines whether to predict, abstain, or send the case to a reviewer.
The reliable approach is to validate uncertainty on labeled data that resembles deployment, state the guarantee precisely, measure set size or review load, and choose action thresholds from the real costs of wrong answers, abstentions, and human review.

What zero-shot classification actually does
A zero-shot classifier applies a model to target categories without task-specific labeled examples for those categories. The model has learned a general representation during pretraining; at inference, it compares an input with descriptions of the possible labels. In a CLIP-style image system, an image embedding is compared with text embeddings created from prompts such as “a photo of a cat” and “a photo of a dog.” The highest-scoring label becomes the prediction.

Why this is useful
You can add or rename categories without collecting and training on a new labeled set. That is valuable for rapidly changing taxonomies, rare classes, and exploratory triage. It does not mean the model understands every label equally well: wording, ambiguity, class imbalance, and a mismatch between pretraining data and the deployment domain can all change performance.

What “zero-shot” does not mean
Zero-shot describes the absence of task-specific labeled training for the target labels. It does not mean that no data are needed. Labeled examples are still needed to evaluate accuracy, calibrate scores, or construct a conformal predictor. Those examples must be kept separate from any data used to fit the underlying model, and their relationship to future cases must be examined.
Confidence scores and calibration answer different questions
A model score is often converted into a probability-like confidence. Calibration evaluates whether that number has the intended interpretation. If a group of predictions receives 0.8 confidence, a well-calibrated system should be correct about 80% of the time for that group, within the population and conditions used for evaluation.
Reliability is empirical, not a property of the label
Neural classifiers can be accurate but overconfident, underconfident, or differently calibrated across classes and domains. Plotting confidence against observed accuracy in bins, and reporting a metric such as expected calibration error (ECE), can reveal systematic gaps. ECE is a summary of the evaluation setup, not a universal safety score: binning choices, sample size, class mix, and distribution shift affect it.
How calibration is fitted
A common workflow holds out a labeled calibration split, fits a mapping from raw scores to probabilities, and evaluates on a separate test split. Temperature scaling is one example for softmax classifiers: one scalar adjusts the sharpness of logits while preserving their ranking. Other mappings can be more flexible, but flexibility increases the risk of fitting noise. Calibration changes how scores should be interpreted; it does not decide whether an error is acceptable, nor does it set the business or clinical cost of abstaining.

What a calibrated probability can and cannot tell you
- It can support statements such as “among comparable cases assigned 0.7 confidence, roughly 70% were correct” when the evaluation population and sampling process justify that statement.
- It does not guarantee correctness for every individual prediction.
- It does not automatically provide per-class or subgroup guarantees.
- It does not remain valid after a major domain, sensor, population, or prompt change without rechecking calibration.
What conformal prediction adds
Conformal prediction uses a labeled calibration sample to return a set of candidate labels rather than only one label. With a user-selected target such as 90% coverage, the method is designed so that the set contains the true label at that marginal rate under its assumptions. As summarized in the ICML 2025 proceedings by Dabah and Tirer, conformal prediction “produces a prediction set of candidate labels that contains the true label with a user-specified probability, guaranteeing marginal coverage but not, e.g., per class coverage.”
Split conformal, step by step
- Train or select the predictor. The zero-shot model and its prompts are fixed without using the conformal calibration labels to alter the model.
- Reserve a labeled calibration sample. These examples should be exchangeable with deployment examples for the desired guarantee; in practice, that means their relevant distribution is stable enough for the claim being made.
- Compute nonconformity scores. Each calibration example receives a score describing how atypical its true label is under the model’s output.
- Choose the quantile for the target coverage. For a target such as 90%, the empirical score quantile determines the inclusion threshold.
- Form a set for each new case. Include every label whose score meets the threshold. The output may contain one label, several labels, or, in poorly matched settings, an unhelpfully large set.
Coverage is not the same as usefulness
Coverage measures whether the true label is included; efficiency measures how small or actionable the sets are while meeting that target. A system that returns nearly every label can have high coverage and little practical value. Set size, class composition, and the percentage of singleton sets should therefore be monitored alongside coverage.
Marginal versus conditional guarantees
Standard split conformal coverage is marginal: it averages over the population represented by the exchangeable calibration and test samples. It is not automatically a guarantee for every class, demographic group, geography, or rare edge case. If a deployment requires subgroup protection, the method and sample sizes must be designed and evaluated for that requirement; do not relabel a marginal result as a class-conditional guarantee.
Can conformal prediction work with a zero-shot model?
Yes. The CVPR 2025 study by Silva-Rodríguez, Ben Ayed, and Dolz applies split conformal prediction to zero-shot CLIP models. Its experiments cover 15 datasets and three non-conformity scores. The paper reports that its Conf-OT approach achieved up to a 20% relative improvement in set efficiency and was 15 times faster than the popular transductive approaches it compared against. Those are results for that experimental design, models, datasets, and baselines—not universal gains that every zero-shot system should expect.

The same work identifies domain drift as a challenge for prediction-set efficiency. A coverage procedure can retain its stated validity under its assumptions while producing larger, less useful sets when calibration and deployment domains differ. That is why a coverage target alone cannot establish that a zero-shot decision system is ready for production.
How calibration and conformal prediction interact
Calibration and conformal prediction can be used together, but they optimize different properties. Calibration improves the probabilistic interpretation of scores. Conformalization turns calibration examples and nonconformity scores into a set with a specified marginal coverage target. Better-calibrated scores may help some conformal algorithms produce smaller or more stable sets, but the effect depends on the algorithm and data.
Dabah and Tirer’s ICML 2025 study analyzes this interaction for adaptive conformal prediction and gives guidance that depends on the practitioner’s goal. It does not support the blanket claim that calibration always improves every conformal method. Evaluate the exact pipeline—score transformation, nonconformity definition, target coverage, and deployment distribution—rather than assuming that adding temperature scaling must help.

| Signal | Possible action | Decision question |
|---|---|---|
| High calibrated confidence and a singleton conformal set | Predict automatically | Is the measured error rate acceptable for this use? |
| Moderate confidence or a multi-label set | Ask for additional information or route to review | Can a reviewer resolve the ambiguity at an acceptable cost? |
| Low confidence, very large set, or an out-of-domain indicator | Abstain and defer | Is abstention safer and cheaper than a wrong automatic answer? |
Choosing a threshold
There is no universal confidence value at which a model should abstain. Set the threshold using expected costs: the harm of a wrong prediction, the operational cost and delay of human review, and the cost of declining to decide. Estimate these quantities with stakeholders, then select the threshold on a calibration or policy-development split and confirm it on untouched data. Thresholds should be revisited when prevalence, staffing, or the consequences of errors change.
A 2026 Scientific Reports paper by Kwon and Kim illustrates this design pattern in clinical early-sepsis prediction: it selected a deferral threshold using task-specific expected costs on a calibration split. That procedure demonstrates how to choose a policy; it is not evidence that the same threshold transfers to another hospital, disease, model, or review workflow.

- Specify the labels and action consequences. Write down which errors are most harmful, what an abstention means operationally, and who will review deferred cases.
- Freeze the zero-shot interface. Record model version, prompts, label descriptions, preprocessing, and any post-processing. Prompt edits are model changes and can invalidate earlier uncertainty measurements.
- Build representative splits. Keep training or prompt-development data separate from calibration and final evaluation data. Include the time periods, devices, languages, and subpopulations expected in deployment.
- Measure raw performance first. Report accuracy or task-appropriate metrics by class and subgroup before interpreting confidence. A calibrated but inaccurate model still makes poor decisions.
- Fit and test calibration. Fit the chosen score mapping on one labeled split, then evaluate reliability and ECE on another. Inspect reliability diagrams and sample counts, not only a single aggregate number.
- Construct conformal sets when a coverage statement is needed. Use a separate labeled calibration sample, choose the target rate, document the nonconformity score, and report empirical coverage plus set-size statistics.
- Design the policy. Map confidence ranges, set sizes, and domain checks to automatic prediction, clarification, or human review. Optimize expected cost on development data, not on the final test set.
- Stress-test shift. Evaluate later time periods, new sources, and known hard categories. Track whether coverage, calibration, set size, and review volume deteriorate together or in different ways.
- Monitor after launch. Log predictions, scores, sets, actions, eventual outcomes, and subgroup identifiers where lawful. Recalibrate or retrain only under a documented change process.
How to compare uncertainty methods
When several approaches are plausible, compare them on the dimensions that determine the decision, not on a single headline metric.
| Axis | Questions to answer |
|---|---|
| Labeled data | Are calibration labels available, recent, and exchangeable with deployment examples? |
| Guarantee | Is the claim marginal, class-conditional, subgroup-specific, or merely an empirical confidence relationship? |

Common failure modes and fixes
“The confidence is 95%, so this case is safe.”
Confidence is a population-level calibration statement, not an individual guarantee. Check reliability on data matching the case’s domain and use a policy that accounts for the cost of mistakes.
“Our 90% conformal sets are guaranteed for every class.”
Standard conformal coverage is marginal. Report per-class and subgroup performance separately, and use a method designed for stronger conditional goals when those goals are required.
“Coverage is high, so the system is useful.”
Inspect set size and reviewer workload. Domain drift can preserve the coverage claim while making sets too broad to guide action.
Do these 3 things before closing this tab:
1Fix the driver behind crashes, sound loss and screen glitches2Clear out junk files and repair common Windows errors3Scan for outdated or missing drivers - takes under a minute“Temperature scaling improved the conformal predictor.”
Measure the complete pipeline. The effect depends on the conformal algorithm, score definition, and data; the ICML 2025 analysis does not justify a universal improvement claim.
“A threshold from one deployment can be copied elsewhere.”
Re-estimate expected costs and validate on local data. The clinical deferral example selected its threshold for a particular task and calibration split.
