Accelerators need a very fast working set—model weights, intermediate results and request state—close to the processor. Persistent storage must hold datasets, checkpoints, logs and retained inference data at a much larger scale. Moving information between those tiers quickly enough to keep accelerators busy is the central infrastructure challenge.
There is no universal memory or storage number for an AI data center. Requirements change with model size, precision, training method, batch and context length, request concurrency, hardware topology and data-retention policy. The useful question is not “How many terabytes does AI need?” but “Which data must be immediately available, which data can be staged, and how fast must each tier deliver it?”

The four layers behind an AI workload
AI systems divide data among several layers because no single technology provides unlimited capacity, extreme bandwidth, low latency and persistence at the same time.

High-bandwidth memory (HBM) is attached to an accelerator package. During a computation step, it holds the tensors the accelerator must access repeatedly: weights, gradients, optimizer state, activations and input batches during training; weights and active request state during inference. Its proximity and bandwidth minimize data movement, but its capacity is fixed by the accelerator configuration. Google Cloud describes HBM as the memory that holds what is needed for computation and warns that running out of it is a hard stop (Google Cloud, December 2, 2025).

CPU or system memory: an extension on supported platforms
System memory can provide additional capacity for staging data, sharing tensors or offloading selected state when the platform supports an appropriate connection and software stack. It is not automatically equivalent to HBM: access normally has higher latency and lower effective bandwidth. NVIDIA’s GH200 example combines 96 GB of GPU HBM with access to 480 GB of CPU-connected LPDDR memory, illustrating an architecture-specific extension rather than a general memory ratio (NVIDIA Technical Blog).
Persistent storage: capacity that survives a job
Storage holds training corpora, checkpoints, evaluation sets, model versions, feature data, logs and other information that must outlive a process or be shared by many machines. Flash, hard drives and hybrid systems can scale to capacities that would be impractical to install as HBM. Storage is farther from the accelerator, so software must stage or stream data rather than treat it as instantaneous working memory.
Data fabric and network: the movement layer
A data fabric connects storage, memory and compute. It can include PCIe links, network adapters, switches, direct-attached devices and DPUs. NVIDIA’s storage-planning guide presents GPU memory, a data fabric and storage devices as a hierarchy whose scalable portions can grow independently of fixed GPU memory (NVIDIA Technical Blog, January 25, 2023). If this movement layer cannot supply data at the required rate, expensive accelerators wait idle even when total storage capacity is sufficient.
| Layer | Primary contents | Strength | Constraint |
|---|---|---|---|
| HBM/GPU memory | Active tensors, weights and request state | Highest proximity and bandwidth | Limited, fixed capacity |
| CPU/system memory | Staged data and selected offloaded state | More capacity on compatible systems | Slower and topology-dependent |
| Persistent storage | Datasets, checkpoints, model files and retained data | Large, durable and shareable | Higher latency; needs data movement |
| Data fabric | Transfers among the other layers | Allows distributed scaling | Bandwidth, congestion and failure can limit utilization |
Why training consumes more memory than model size suggests
A model’s parameter count describes only one part of a training job. The training process also computes and retains additional arrays, often at different precision and with different lifetimes.

Weights
Weights are the learned parameters used in the forward and backward passes. As an illustrative figure, Google Cloud calculates that a 7-billion-parameter model stored at 16-bit precision needs roughly 14 GB for weights alone (Google Cloud, December 2, 2025). That is not a full-training requirement: it excludes gradients, optimizer state, activations, temporary workspaces and input batches.
Gradients and optimizer state
Backpropagation produces gradients, and optimizers such as AdamW retain additional statistics for each parameter. Those arrays can multiply the weight footprint. Precision choices—such as bfloat16, float16 or higher-precision optimizer data—change the bytes per value. Quantization can reduce some footprints, but it also changes the numerical and software requirements of the job.
Activations and batches
Intermediate activations are needed to calculate gradients unless the system recomputes them or uses another memory-saving technique. Their size rises with sequence length, hidden dimensions, number of layers and batch size. A larger batch can improve throughput while making the instantaneous working set too large for available HBM.
A concrete fine-tuning baseline
Google Cloud gives a 4-billion-parameter MedGemma full-fine-tuning example with a 32 GB static baseline before additional activation memory, using bfloat16 and AdamW (Google Cloud, December 2, 2025). The number is configuration-specific: changing optimizer, precision, sequence length, batch size or checkpointing changes the result. It demonstrates why a model that appears to fit by weight size alone may not fit during training.

Training data still has to arrive
Datasets are usually far larger than accelerator memory. A training loader reads samples from persistent storage, decodes and transforms them, then stages batches through system memory and the fabric into accelerator memory. Sharding, caching and prefetching can hide some latency, but a storage system that delivers data too slowly creates input stalls and lowers accelerator utilization. Checkpoints and intermediate outputs also generate substantial writes, particularly when many workers save versions concurrently.
Why inference develops its own memory pressure
Inference reuses model weights across requests, so it does not normally maintain training gradients or optimizer statistics. It nevertheless has a growing per-request working set.
KV cache and context length
Transformer language models retain key and value tensors from prior tokens in a KV cache. Reusing that state avoids recomputing attention for the entire conversation at every generated token. Longer prompts, longer generated responses and more simultaneous requests make the cache larger. The cache is repeatedly read during token generation, so both capacity and bandwidth matter.
Concurrency and scheduling
A service must reserve memory for many active sequences, not just one example. Continuous batching can improve throughput by mixing requests, but it also changes how much cache and temporary workspace must coexist. When HBM fills, a server may reject requests, reduce batch size, evict or offload cache, or move state to a slower tier. Each choice trades latency, throughput and cost.

Long-context and agentic designs
Recent vendor architectures describe context-storage tiers and software that distributes or offloads KV cache for long-context or agentic inference. These are directions and implementation claims, not evidence that one design is universal. Any offload policy must account for the extra transfer time and ensure that the fabric can serve cache reads without starving active computation (NVIDIA Blog, August 4, 2026; NVIDIA Investor Relations, March 18, 2025).
Independent reader supportYour contribution helps us test, update, and keep practical guides available for everyone. Why bandwidth and proximity determine performance
Capacity answers whether data can be held; bandwidth and latency answer whether the accelerator can be kept busy. A job may have enough total bytes across memory and storage yet still run slowly if the next batch, tensor or cache segment arrives late.
A Microsoft Research paper uses 8 TB/s as an example of B200 memory bandwidth. That is a platform-specific figure quoted in a 2025 publication, not a universal accelerator specification (Microsoft Research, HotOS ’25, May 2025). It illustrates the scale gap between local HBM and ordinary storage links: repeatedly fetching a hot tensor from persistent storage would be far too slow, so systems keep the active working set in HBM and use lower tiers for staging and retention.
Do these 3 things before closing this tab:
1Repair Windows errors before they cause bigger problems2Scan for outdated or missing drivers - takes under a minute3Clear out junk files and repair common Windows errorsAt larger scale, accelerators are connected into tightly coupled clusters. Microsoft describes one AI data-center rack containing 72 Blackwell GPUs and 14 terabytes of pooled memory (Microsoft, September 18, 2025). That is a vendor account of one rack configuration, not a typical or recommended specification. The practical lesson is that memory capacity and bandwidth are increasingly designed at rack and cluster level, not only per server.

How to plan memory and storage for an AI workload
- Define the workload. Record whether it is pretraining, full fine-tuning, parameter-efficient fine-tuning, batch inference or interactive serving. Note model parameters, precision, sequence or context length, batch size and target concurrency.
- Calculate the accelerator working set. Include weights plus gradients, optimizer state, activations and temporary workspace for training. For inference, include weights, KV cache per request, batching overhead and runtime workspace. Leave headroom for fragmentation and operating-system or framework allocations.
- Choose the memory topology. Determine whether multiple GPUs share memory, whether CPU memory is coherent or explicitly staged, and which links connect the devices. A larger nominal pool is useful only if software can access it at acceptable latency.
- Characterize the data pipeline. Measure dataset size, sample decoding cost, checkpoint frequency, model-version retention and simultaneous readers and writers. These determine persistent capacity and I/O rates.
- Match storage delivery to compute. Select local flash, shared flash, hard-disk capacity or a hybrid arrangement according to access pattern. Validate read and write throughput under the expected number of workers rather than relying on an isolated device specification.
- Design staging and recovery. Use prefetching and caching for predictable batches, checkpoint to durable storage, and define what can be recomputed if a cache or node fails. Keep enough capacity for temporary files, failed-job remnants and multiple model versions.
- Test at concurrency. Run representative training workers or inference requests while observing accelerator utilization, HBM occupancy, cache hit rate, fabric throughput, storage latency and queue depth. A single-request test can hide contention.
Common bottlenecks and what they mean
- Out-of-memory during training: the instantaneous working set exceeds HBM. Reduce batch or sequence size, use activation checkpointing, change precision where supported, use a memory-saving optimizer or distribute the model; adding disk capacity alone will not fix an HBM allocation failure.
- GPU utilization falls while storage queues grow: workers are waiting for data. Improve sharding and prefetching, add cache capacity or increase aggregate storage and fabric throughput.
- Inference latency rises with longer prompts: KV-cache capacity or bandwidth is becoming the limiter. Reduce concurrent context, shorten retained history, optimize cache layout or evaluate an offload tier whose transfer cost fits the latency target.
- Checkpoints stall all workers: many processes are writing at once. Stagger checkpoints, use asynchronous or incremental writes where supported, and provision bandwidth for the write burst as well as normal reads.
- A larger pooled-memory system performs worse than expected: accesses may cross a slower link or incur synchronization overhead. Inspect topology and placement; capacity without locality does not provide HBM-like performance.
What the “right amount” depends on
The same parameter count can produce very different infrastructure requirements. Full fine-tuning retains more state than inference. A small model serving thousands of long-context requests may need more aggregate cache than a larger model serving short, infrequent requests. A dataset may fit on disk yet fail to meet the training pipeline’s read-rate target. Conversely, a high-throughput local cache can reduce repeated reads without changing the durable dataset size.
For that reason, hardware examples should be read as illustrations, not rules. The 14 GB weight footprint for a 7-billion-parameter 16-bit model, the 32 GB static MedGemma fine-tuning baseline, the 8 TB/s B200 example and the 72-GPU, 14-terabyte rack all describe particular models, platforms or configurations. They do not establish a cross-industry total for an AI data center.
Frequently asked questions
Can persistent storage replace GPU memory?
No. Storage can provide capacity and preserve data, but active kernels require much lower-latency access than ordinary storage offers. Systems can stage or offload selected data, accepting a performance trade-off; they cannot make a storage device behave like local HBM.
Does adding CPU memory always solve an HBM shortage?
No. It helps only when the platform and software support the required sharing or offload path, and transfers are slower than local HBM. The GH200 configuration is an example of a designed CPU-GPU memory relationship, not a promise for every server.
Why not keep the whole dataset in accelerator memory?
Datasets, checkpoints and model histories commonly exceed the fixed capacity of accelerators and must be shared across jobs and retained after a run. Keeping only the active working set close to compute provides a better balance of speed, capacity and cost.
Frequently Asked Questions
What is the simplest way to estimate memory before buying hardware?
Start with the model’s weight bytes, then add the arrays required by the training method or the KV cache and concurrency required by inference. Validate the resulting working set with the exact precision, sequence length, framework and topology; parameter count alone is not a sufficient estimate.
Is more storage useful if the data pipeline is already fast enough?
Additional capacity is still useful for checkpoints, model versions, logs and retention, but it will not improve runtime once delivery bandwidth and latency already exceed the workload’s needs.
