Why AI Data Centers Need GPUs, HBM, and Advanced Chip Packaging

AI data centers pair GPUs, high-bandwidth memory (HBM), and advanced chip packaging because modern models move enormous amounts of data while performing the same mathematical operations in parallel. The GPU supplies the parallel compute engines, HBM keeps model weights and activations close with very high throughput, and the package provides the short, dense connections that let the two work as one accelerator.

None of the three is a standalone performance guarantee. Useful throughput depends on the complete platform: HBM capacity and bandwidth, GPU-to-GPU interconnects, compute capability at the required precision, power delivery, cooling, and software.

Why AI workloads make data movement a first-order problem

Parallel math creates parallel data demand

Training and serving neural networks involve matrix multiplications, convolutions, attention operations, and other calculations that can be split into many independent pieces. A GPU contains thousands of relatively small arithmetic units designed to execute those pieces concurrently. When enough work is available, this parallelism is far more efficient than assigning each operation to a general-purpose CPU core.

Moving values can limit the arithmetic

Every calculation still needs operands: model weights, input tokens, intermediate activations, gradients during training, and temporary buffers. If those values arrive too slowly, arithmetic units sit idle. The limiting resource can therefore be memory bandwidth rather than the number of multiply-add units. Keeping data physically close to the compute die reduces the distance and electrical cost of each transfer, while a very wide memory interface moves many bits in each cycle.

What the GPU contributes

The accelerator’s parallel compute engine

In an AI data-center system, the GPU is the main engine that performs tensor and vector operations. It also includes memory controllers, caches, scheduling logic, and specialized units for common AI precisions. NVIDIA describes H100, H200, and B200 GPUs as components in multi-GPU AI platforms rather than as isolated desktop cards. Their value comes from combining compute with local memory and high-speed links to other GPUs.

Scaling beyond one GPU

Large models often exceed the compute or memory resources of one accelerator. Systems therefore connect multiple GPUs so that a training job or inference service can divide a model and its data across devices. Interconnect bandwidth and latency determine how efficiently those devices exchange activations, gradients, and parameters. A GPU with high local bandwidth can still underperform if the workload repeatedly waits for transfers between GPUs.

What HBM is and why accelerators use it

A wide, stacked memory design

High-bandwidth memory is a family of memory technologies designed to deliver very high throughput to processors and accelerators. Instead of placing memory chips far away on a circuit board, HBM uses vertically stacked dies connected through many fine-pitch connections. Several stacks can sit beside the logic die in the same package, with a very wide interface feeding data to the GPU.

Bandwidth for weights and activations

AI kernels frequently read large blocks of weights and activations and write new intermediate results. HBM’s wide interface allows many transfers in parallel, so the accelerator can sustain more of its available arithmetic rate. This is different from saying that HBM makes every operation faster: a workload that fits in cache, is limited by communication, or lacks enough parallelism may not use the available bandwidth.

Capacity determines what fits locally

Bandwidth controls how quickly data can be streamed; capacity controls how much can remain on the accelerator without being fetched from slower system memory or storage. If a model, batch, or set of key-value caches does not fit, the system may need partitioning, recomputation, or transfers over comparatively slower links. Those workarounds can reduce utilization even when peak compute and HBM bandwidth are high.

A concrete generation-specific example comes from Micron’s HBM3E product brief: an 8-high stack is specified at 24 GB with more than 1.2 TB/s of bandwidth. That figure applies to the named product and stack configuration, not to every HBM device.

What advanced chip packaging does

It puts logic and HBM in one package

Advanced packaging provides the physical connection between the GPU logic die and the HBM stacks. In a 2.5D design, the dies remain side by side rather than one directly above the other, but a silicon interposer routes a very large number of short, dense connections between them. This arrangement supports the wide memory interface that a conventional package and board trace layout would struggle to provide.

TSMC’s CoWoS example

TSMC describes CoWoS as a 2.5D packaging platform for high-performance computing and AI. Its CoWoS-S variant uses a silicon interposer to accommodate logic dies and HBM. TSMC says CoWoS has been in production since 2012 and that CoWoS-R entered volume production in 2023. The company characterizes CoWoS as “TSMC’s world-leading CoWoS® advanced 2.5D packaging technology [that] provides the essential foundation for high-performance computing (HPC) and artificial intelligence (AI) products.”

These statements describe a packaging capability, not a claim that every accelerator uses CoWoS. Exact interposer type, assembly process, HBM supplier, and package layout vary by product.

Why the package is part of the architecture

Shorter connections reduce signal loss and energy per bit compared with routing the same interface across a larger board. The package also fixes the physical relationship among logic, memory stacks, power delivery, and thermal paths. As dies become larger and interfaces wider, package design affects yield, testing, repair options, and the maximum practical number of HBM stacks.

How GPU, HBM, and packaging work together

  1. Compute units request data. Tensor or vector engines issue reads for weights and activations and writes for results.
  2. On-package memory responds. HBM stacks provide high-throughput storage through the wide interface implemented by the package.
  3. The interposer carries signals. Dense traces in the 2.5D package connect the GPU die’s memory controllers to each stack.
  4. Kernels reuse data. Caches and software scheduling try to keep frequently used values near the compute units, reducing unnecessary HBM traffic.
  5. GPUs exchange larger tensors. When a job spans devices, dedicated GPU-to-GPU links move data between accelerators; local HBM does not replace this interconnect.
  6. Power and cooling sustain the cycle. The package, board, voltage regulators, and cooling system must remove the heat generated by sustained compute and memory activity.

The result is a tightly coupled hierarchy: registers and caches are smallest and closest, HBM supplies large local bandwidth, and inter-GPU or host memory provides greater aggregate capacity at different latency and bandwidth.

Capacity and bandwidth do not rise in lockstep, and a larger number does not automatically win every workload. Comparisons should also specify GPU compute performance at a stated precision, GPU-to-GPU interconnect, power limits, cooling, software stack, and whether the job is training or inference.

What determines real-world AI performance

Compute at the required precision

Peak operations per second are meaningful only when the model can use the GPU’s supported data types and specialized units. A model that requires high numerical precision, sparse operations, or unusual kernels may achieve a different fraction of peak than a benchmark based on dense low-precision tensor operations.

Memory capacity and access pattern

Check whether the full model, batch, optimizer state, and inference cache fit in local HBM. Training commonly needs additional state beyond the model weights. Inference may be dominated by key-value cache growth, request concurrency, or long context windows. If data repeatedly spills to host memory, the nominal HBM bandwidth no longer describes the application’s dominant path.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Interconnect and collective communication

Distributed training relies on operations such as all-reduce and all-gather. Their speed depends on the topology and bandwidth of GPU-to-GPU links as well as software libraries. A system with many GPUs can lose efficiency when communication occupies a large share of each iteration.

Power delivery and cooling

High-throughput accelerators draw substantial power under sustained load. Voltage regulators, board traces, package connections, heat spreaders, cold plates or other cooling hardware, and data-center airflow must be designed together. If a system throttles to stay within thermal limits, its delivered performance falls below the unthrottled specification.

Software and scheduling

Compilers, kernel libraries, communication runtimes, quantization choices, and memory managers determine how effectively hardware resources are used. The same accelerator can show different throughput when a model uses fused kernels and good data reuse versus frequent synchronization and small, irregular operations.

Trade-offs and common failure modes

High bandwidth does not solve insufficient capacity

A model that exceeds local HBM must be sharded, offloaded, compressed, or served with a smaller batch. Each option changes latency, accuracy, engineering complexity, or cost. Choosing a platform therefore starts with a capacity estimate, not just a bandwidth figure.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Adding GPUs can expose communication bottlenecks

More accelerators increase aggregate compute, but scaling is limited when devices wait for one another. Measure communication time, link topology, and synchronization frequency before assuming that doubling GPU count will double throughput.

Packaging is a manufacturing constraint as well as a performance feature

Large interposers, multiple HBM stacks, and complex assembly increase testing and supply-chain requirements. A package can be electrically suitable yet difficult to yield at volume. Product schedules and availability therefore depend on packaging capacity and qualified HBM supply, not only on the GPU design.

Thermal density can limit sustained operation

Putting compute and memory close together shortens signals but concentrates heat. The cooling solution must handle both the logic die and the HBM region while maintaining reliable temperatures across the package. Short benchmark bursts may not reveal limits that appear during long training runs.

A historical reference: NVIDIA A100

NVIDIA’s 2020 A100 datasheet listed 40 GB of HBM2 and 1.6 TB/s of bandwidth. This is useful for illustrating how data-center GPUs have long paired parallel compute with HBM, but it is a historical specification and should not be treated as a current comparison with H100, H200, or B200.

How to evaluate an accelerator platform

  1. Size the working set. Account for weights, activations, optimizer state, temporary buffers, and inference caches.
  2. Match bandwidth to the access pattern. Determine whether kernels stream data from HBM or mostly reuse values in cache.
  3. Check compute at your precision. Use the data types and sparsity patterns supported by the actual model.
  4. Map communication. Verify GPU-to-GPU topology and estimate collective-communication time for the planned scale.
  5. Validate power and cooling. Confirm rack power, thermal design, and sustained—not just burst—operation.
  6. Verify software support. Test drivers, frameworks, kernel libraries, and distributed-training tools with the intended model.
  7. Compare complete systems. Treat GPU, HBM, package, interconnect, host system, and cooling as one platform rather than selecting a component from a single headline number.

Frequently asked questions

Is HBM the same as ordinary system RAM?

No. HBM is a specialized, on-package memory technology optimized for accelerator bandwidth and integrated with a compatible package design. General-purpose system RAM is farther from the GPU and uses a different interface and latency profile.

Does advanced packaging increase a GPU’s compute capability?

Packaging does not add arithmetic units. It enables the electrical connections, memory placement, power delivery, and thermal design needed for a high-performance GPU and HBM combination. The resulting system may sustain more of the GPU’s compute potential because data arrives efficiently.

Can a GPU operate without HBM?

Some GPUs use other memory arrangements, but an accelerator designed around on-package HBM cannot simply substitute a distant memory interface without changing its package, controllers, board, and software assumptions. The appropriate memory technology depends on the product’s architecture and workload.

Why not compare accelerators by TB/s alone?

TB/s describes a memory-transfer ceiling for a stated configuration. Application throughput also depends on capacity, arithmetic throughput, interconnect traffic, power limits, cooling, and software efficiency, so a single bandwidth number cannot predict an entire workload.
