Add activation checkpointing when intermediate activations—not model weights or optimizer state—are causing out-of-memory errors. These settings trade memory, throughput, recomputation, compatibility and adaptation behavior, so the best combination must be measured on your exact GPU, model, sequence length and software versions.
What consumes GPU memory during fine-tuning?
Peak memory is not just the model file. During training, the GPU may hold trainable weights, gradients, optimizer state and intermediate activations saved for backpropagation. A full fine-tuning accounting described by PyTorch uses about 16 bytes per trainable parameter before intermediate activations in the stated half-precision-weight, half-precision-gradient and FP32 Adam setup. That figure is an accounting example, not a universal requirement: sequence length, batch size, optimizer, implementation and temporary workspaces can change the result substantially.

Use this distinction to choose a setting. If trainable parameters and their optimizer state dominate, parameter-efficient tuning or a different optimizer is more relevant. If long sequences and large batches create the spike, reduce the micro-batch or checkpoint activations. If matrix operations are the bottleneck, a supported mixed-precision path may improve throughput.
The settings to try first
| Setting | Primary benefit | Main cost or limitation | Use it when |
|---|---|---|---|
| LoRA | Trains a small adapter instead of all base-model parameters | May not match full fine-tuning for every task; adapter and target-layer support vary | Adapter tuning is acceptable and full gradients or optimizer state do not fit |
| QLoRA | LoRA plus quantized frozen base weights; lowers base-weight storage further | 4-bit implementation, kernels and hardware must be compatible | LoRA fits poorly or you need to run a larger model on the same GPU |
| Mixed precision | Can reduce some memory use and accelerate supported operations | Speed depends on GPU, dtype, kernels and tensor shapes; numerical handling differs | Your GPU and framework support BF16 or FP16 reliably |
| Smaller micro-batch | Directly lowers activation peaks | Fewer samples per step; may reduce utilization | A full forward/backward pass causes out-of-memory errors |
| Gradient accumulation | Preserves a larger effective batch with small micro-batches | Adds forward/backward micro-steps, so it does not remove compute | You need a target batch size that cannot fit in one pass |
| Activation checkpointing | Reduces saved activation memory by recomputing selected forward operations | Extra computation and possible compatibility issues | Activations, especially from long sequences, are the bottleneck |
1. Start with LoRA or QLoRA
LoRA: freeze the base model
LoRA freezes the original model and inserts trainable low-rank adapter matrices. Because the base parameters do not receive gradients, the run avoids maintaining full gradients and optimizer state for every original parameter. The base weights still occupy memory, and activations still matter, but the trainable-state portion can be dramatically smaller.

PyTorch describes a 7-billion-parameter model fine-tuned with LoRA on an NVIDIA T4 with 16 GB in its consumer-hardware example. Treat that as an example of a workable configuration, not a promise that every 7B model, context length or dataset fits on every 16 GB card. Adapter rank, target modules, sequence length and batch size all affect the result.
QLoRA: quantize the frozen weights
QLoRA combines LoRA with quantization of the frozen base model. The PyTorch discussion identifies NF4 quantization, double quantization and paged optimizers among the method’s techniques. TorchAO’s fine-tuning documentation defines QLoRA as LoRA plus 4-bit quantization of frozen original parameters and describes NF4 support in its implementation.
PyTorch reports that QLoRA reduced fine-tuning memory footprint by more than 90% in the context of its article and characterized performance as matching 16-bit fine-tuning across the scales and models it reported. Those are source-specific claims, not a guaranteed percentage or quality result for your workload. Check that your chosen framework, quantization backend, GPU architecture and checkpoint format support the exact recipe before committing to a long run.

Choose full fine-tuning only when updating all model parameters is required by the task, your evaluation shows that adapters are insufficient, or your infrastructure can support the larger state. LoRA and QLoRA also add setup decisions: target modules, rank, scaling, dropout, saving and later adapter loading. They reduce the trainable state but do not make data loading, tokenization or evaluation free.
2. Enable a supported mixed-precision mode
BF16 versus FP16
Automatic mixed precision (AMP) lets the framework select lower precision for suitable operations while retaining safer precision where needed. On modern GPUs, BF16 may be available and is often recommended when the hardware supports it. FP16 can require gradient scaling to prevent underflow. Do not copy a dtype setting blindly: check your GPU, driver, framework version and the operations used by your model.

In a plain PyTorch loop, AMP uses autocasting and, for FP16 training, a GradScaler. The scaler helps small gradients survive FP16’s limited range. BF16 generally uses a wider exponent range and may not require scaling, but the exact behavior depends on the training stack.
What speed improvement is realistic?
PyTorch’s performance guide says mixed precision can provide up to 3x overall speedup on Volta and newer architectures when Tensor Core conditions are met. This is an upper-bound statement under suitable conditions, not a forecast for an arbitrary local GPU. Matrix and tensor dimensions, including dimensions that are multiples of eight, can affect Tensor Core utilization. Small batches, unsupported operations, data-loader stalls or memory-bandwidth limits can leave little speed to gain.
Use one precision consistently in comparisons
When comparing settings, hold the dtype policy constant unless precision itself is the variable under test. Record whether weights, gradients, optimizer state and autocast operations use FP16, BF16 or FP32. A run that appears faster may simply be doing less work or using a different numerical path, so compare the same number of tokens or training steps and evaluate quality with the same procedure.
3. Reduce the micro-batch, then recover effective batch size
Find the largest micro-batch that fits
The per-device micro-batch is the number of examples processed in one forward/backward pass on one GPU. Lowering it usually lowers activation memory immediately. Start with a conservative value, confirm that a complete forward and backward pass succeeds, then increase it until you approach the memory limit without repeated out-of-memory failures.
Use gradient accumulation for a target effective batch
With one process, the effective batch is:
effective batch = micro-batch × accumulation steps

With distributed training, multiply by the number of processes as well. For example, a micro-batch of 2 and 8 accumulation steps gives an effective batch of 16 on one process. Accumulation does not reduce the total arithmetic: it performs eight micro-steps before one optimizer update.
Recommended Free Tools
In AMP training, keep gradients scaled throughout the micro-batches and call the optimizer step and scaler update only at the effective-batch boundary. Changing the scale factor or unscaling between partial steps can break the intended accumulation semantics. In distributed training, intermediate gradient synchronization can often be skipped and performed only on the final backward pass, reducing unnecessary communication; that optimization does not apply to a single-GPU run.
Understand the throughput trade-off
A smaller micro-batch may lower GPU utilization, while accumulation increases the number of launches and synchronization points. Measure tokens or samples per second after warmup rather than assuming that the configuration with the lowest memory use is the fastest. If the larger effective batch changes optimization behavior, compare validation quality as well as speed.
4. Add activation checkpointing when activations dominate
How checkpointing works
Activation checkpointing deliberately does not retain selected forward intermediates until backward. During the backward pass, it reruns the relevant function to reconstruct them. This lowers peak memory at the cost of extra computation and therefore can increase wall-clock time.
PyTorch recommends the non-reentrant implementation, use_reentrant=False. The forward computation and its recomputation must behave consistently. Differences caused by mutable state, random-number handling, data-dependent control flow or unsupported operations can produce errors or silently incorrect gradients.

When it is the right lever
Checkpointing is most useful when long sequences or large micro-batches create an activation spike while the model and optimizer state otherwise fit. It is less useful when frozen-weight storage or adapter optimizer state is the dominant allocation. Combine it with LoRA or QLoRA when both parameter state and activations are tight, then benchmark the recomputation penalty.
Independent reader supportYour contribution helps us test, update, and keep practical guides available for everyone.5. Diagnose the bottleneck before specialized optimizations
Separate weights, gradients, optimizer state and activations
Capture a memory snapshot or profiler trace around forward, backward and optimizer steps. A rising allocation during forward points toward activations or temporary workspaces. Memory that remains allocated before and after forward is more likely to be model, adapter, gradient or optimizer state. A spike during the update can indicate optimizer-state or temporary-buffer pressure.
Optimizer step in backward
PyTorch documents fusing an optimizer step into the backward pass as a way to reduce memory occupied by gradients. It specifically presents this technique for cases where gradient accumulation is not needed. It is specialized: it can change optimizer scheduling and is not a drop-in replacement when you require several backward passes per update. Use it only after identifying gradients as the bottleneck and verifying that its constraints match your training loop.
A practical configuration sequence
- Record the baseline. Note GPU model and memory, model size, sequence length, micro-batch, optimizer, precision, framework and library versions, and whether the run is full fine-tuning or adapter tuning.
- Choose the training method. Try LoRA when adapter tuning is acceptable. Try QLoRA when frozen-weight storage is still too large and your quantization stack supports the model.
- Select precision. Test BF16 if supported; otherwise test FP16 with the framework’s scaler and fallback behavior. Keep unsupported operations in their required precision.
- Fit the micro-batch. Reduce it until a complete forward/backward pass succeeds. Leave headroom for evaluation, checkpoint saving and allocator variation.
- Restore the effective batch. Increase accumulation steps to reach the intended effective batch, remembering that this adds micro-steps rather than removing work.
- Profile memory. If activations dominate, enable checkpointing with the non-reentrant implementation and remeasure throughput.
- Run a controlled comparison. Change one principal setting at a time and train on the same representative data and sequence lengths.
How to benchmark settings fairly
Use the same model revision, data order or representative subset, tokenization, sequence length and evaluation method. Warm up the GPU before recording throughput. For every configuration, record:
What’s actually slowing this PC down?
Pick the symptom - the matching free tool is one click away.
- Peak allocated and reserved GPU memory.
- Samples or tokens per second after warmup.
- Wall-clock time to the same number of tokens, steps or convergence target.
- Loss curves, validation metrics and any instability such as NaNs or skipped updates.
- GPU model and memory, operating software, framework and library versions.
- Precision, micro-batch, accumulation steps, checkpointing mode, adapter settings and quantization details.
Compare total time to the same training target, not merely time per optimizer step. Accumulation, checkpointing and evaluation frequency can make a step-level comparison misleading. A lower-memory run is not automatically better if recomputation or extra micro-steps make it slower than a slightly larger configuration that still fits.
Best Value
Common failure modes and fixes
Out-of-memory during forward
Lower the micro-batch first, then shorten the sequence length if the task permits. If the model is frozen but still too large, move from LoRA to QLoRA with a verified 4-bit implementation. Add activation checkpointing when profiling shows saved activations are responsible.
Out-of-memory during backward or optimizer update
Check whether gradients or optimizer state, rather than activations, are responsible. LoRA or QLoRA can remove most base-model gradient and optimizer allocations. If gradient accumulation is unnecessary and gradients are the identified bottleneck, investigate optimizer-step-in-backward under its documented constraints.
FP16 instability
Use the framework’s AMP scaler, avoid manually unscaling between accumulation micro-steps, and verify that optimizer stepping and scaler updates occur only at effective-batch boundaries. If the GPU supports it, test BF16. Check for NaNs, overflows and operations that require FP32.

Use use_reentrant=False as recommended by current PyTorch documentation. Ensure the recomputed forward follows the same code path and random-state behavior as the original forward. Disable checkpointing temporarily to isolate whether it caused the failure, then reintroduce it around compatible blocks.
Decision rule
Use LoRA when adapters satisfy the task and you want the simplest reduction in trainable state. Use QLoRA when frozen base-weight storage is the limiting factor and your stack supports the required 4-bit path. Use mixed precision whenever the hardware and operations support it reliably. Use a smaller micro-batch plus accumulation when a target effective batch matters but one pass does not fit. Use activation checkpointing only when profiling points to activations and you accept recomputation. Then select the winner by measured peak memory, throughput, total run time, stability and task quality on your local workload.
