Batch is appropriate for bounded or historical data when results can arrive by a job deadline. Streaming is appropriate when new events must influence a decision within a defined freshness target. Hybrid combines both paths when urgent event handling and scheduled or historical processing have different requirements. AI inference can run in batch or streaming pipelines, so the model alone does not determine the choice.
Decision at a glance
| Architecture | Best fit | Trade-offs to evaluate |
|---|---|---|
| Batch | Bounded, historical, or periodically collected inputs; users can wait for a completion target. | Completion deadline, data volume, startup and shutdown overhead, replay and reconciliation, and tolerance for stale results. |
| Streaming | Continuously arriving events that must affect outputs within a freshness objective. | End-to-end latency, late and out-of-order events, correctness, sustained runtime cost, traffic spikes, and downstream capacity. |
| Hybrid | Workloads in which some users or data need low latency while other work can run periodically, including historical backfills alongside live data. | More operational paths and consistency work in exchange for isolating service objectives and resources. |
These categories describe workload decisions rather than universal speed or price rankings. A pipeline that processes quickly can still miss its objective if a source, sink, network link, quota, or external service is the bottleneck.

What the architecture changes for an AI system
A data pipeline moves records from sources through transformations to storage, features, predictions, or other sinks. In the Apache Beam model, a collection can be bounded, meaning its contents are finite and known, or unbounded, meaning records continue to arrive. Batch jobs normally operate on bounded collections; streaming jobs operate on unbounded collections and must account for time, incomplete input, and events that arrive late.
That distinction matters more than the label AI. The same trained model may score a nightly customer file, a queue of documents, or an event stream. Beam’s machine-learning documentation, last updated October 11, 2026, describes model inference in both batch and streaming pipelines. The architecture should therefore begin with the decision’s freshness and completeness requirements, then place inference where it best fits the workload.

When batch processing is the right choice
Bounded data and a completion deadline
Batch is the natural fit when the input set is finite or can be closed for processing. Examples include a daily feature refresh, a monthly financial calculation, a historical backfill, or scoring all records delivered by a partner before a scheduled report. Amazon Web Services uses large-volume periodic work such as monthly accounting as an example of a batch-oriented data-pipeline task; see AWS’s data-pipeline overview.
Define the result in terms of completion: for example, the job must finish before a report is generated or before the next business day begins. The exact deadline belongs to your application; there is no universal batch cutoff that applies to every AI workload.
How a batch AI path works
- Land the source files or a time-bounded extract in durable storage.
- Validate schemas, required fields, partition boundaries, and record counts.
- Transform and enrich the bounded collection, joining reference data as needed.
- Run model inference in parallel over partitions or micro-batches.
- Write predictions, quality metrics, and lineage information to the destination.
- Publish the result only after validation succeeds, retaining the input and model versions for replay.
This arrangement makes repeatability and reconciliation straightforward: the same input snapshot and model version can be rerun. It also makes backfills practical because a historical interval can be processed without maintaining a continuously running service.
Do these 3 things before closing this tab:
1Clear out junk files and repair common Windows errors2Scan for outdated or missing drivers - takes under a minute3Repair Windows errors before they cause bigger problemsWhere batch becomes a poor fit
A batch result ages while it waits for the next run. That is acceptable for decisions whose value changes slowly, but not for fraud screening, operational alerts, or recommendations that must react to recent behavior. Very small jobs can also be inefficient if the platform spends more time starting and stopping workers than processing records. Google’s Dataflow cost guidance discusses this startup overhead and warns that low ingest latency, high throughput, late data, and traffic spikes affect cost; those observations are specific to Dataflow operations, not a benchmark for every processing engine.
When streaming is the right choice
Freshness is part of correctness
Streaming is warranted when incoming events should change an output before the next scheduled batch. Examples include updating a risk score after a transaction, triggering an intervention after a sensor reading, or refreshing a recommendation after a user action. The requirement should be stated as an end-to-end freshness objective: how old may the data be when the decision is consumed?

Google’s Dataflow pipeline-planning guidance distinguishes streaming objectives based on maximum data age from batch objectives based on completing a percentage of work within a time window. Measure the age at the point where the consumer receives the result, not only the time spent inside the processing engine.
Design for event-time behavior
Events can arrive late, out of order, duplicated, or not at all. A streaming design therefore needs explicit rules for:
Recommended Free Tools
- Which timestamp represents the business event and which represents arrival.
- How long a window remains open for late records.
- Whether a correction replaces an earlier prediction or creates a new version.
- How duplicates are detected and removed.
- What happens when a model, feature service, or sink is temporarily unavailable.
These rules determine correctness as much as the model does. A pipeline that emits a fast but incomplete prediction may violate the business requirement, while a slightly slower result that incorporates late events may be acceptable. Track backlog, watermark or event-time progress, late-data volume, error rates, and output age together.
Operational consequences of a continuously running path
Streaming jobs consume resources while idle and must absorb sustained traffic as well as bursts. Source limits, sink write capacity, quotas, partitioning, network placement, and calls to external services can all set the practical ceiling. Google advises evaluating the complete path because the processing engine cannot exceed a connected system’s capacity. Plan backpressure behavior and decide whether to shed, delay, or persist work during a spike.
When a hybrid architecture is justified
Separate paths for different service objectives
Hybrid means the system intentionally uses both scheduled and event-driven processing. A live scoring path can serve immediate decisions while a batch path recomputes features, performs a full historical correction, or produces reports. This separation prevents a large backfill from competing directly with latency-sensitive traffic.

Google’s planning guidance notes that separate pipelines can isolate workloads with different service-level objectives and capacities. The cost is an additional deployment and a reconciliation contract: both paths must agree on schemas, feature definitions, model versions, and ownership of the final record.

A unified programming model where it fits
Hybrid does not always require two completely different codebases. Beam allows bounded and unbounded collections to coexist, so teams can reuse transformations while selecting batch or streaming execution for each input. Reuse is valuable only when the shared logic has clear time and state semantics; a transform that assumes a closed dataset may be unsafe on an unbounded stream.
Backfills, corrections, and serving precedence
Decide how a historical correction interacts with predictions already served from the live path. Common choices are to let the batch result replace the live value for a defined interval, retain both versions with timestamps, or replay the corrected interval through the streaming logic. Document the choice, make writes idempotent, and expose the effective model and data version to downstream consumers.
Criteria to compare before choosing
Latency and freshness
Specify the maximum acceptable age of input data and the time allowed for processing, transport, storage, and downstream consumption. A millisecond target can be meaningless if the sink updates every minute or an external feature call takes longer than the model inference.
Completeness and correctness
Ask whether a decision may be made from a partial view. Batch naturally waits for a defined collection; streaming must define windows, late-data handling, deduplication, and correction behavior. Instrument missing records and revisions rather than reporting only successful task counts.

Throughput and burstiness
Estimate average volume, peak volume, event size, partition distribution, and the rate at which a backlog must be cleared. A design that handles average traffic but not a predictable spike will either violate freshness or require expensive overprovisioning.
Cost and resource lifetime
Compare the cost of continuously allocated workers with the startup and shutdown cost of scheduled jobs. Include storage, network transfer, model loading, feature lookups, retries, and external API calls. Google’s Dataflow cost guidance specifically calls out low ingest latency, high throughput, late data, spikes, and job lifecycle as cost-influencing requirements.
System constraints
Check source and sink capacity, quotas, regional placement, network routes, data formats, partition keys, security controls, and the availability of model-serving dependencies. These constraints can eliminate an otherwise attractive architecture before performance testing begins.
Independent reader supportYour contribution helps us test, update, and keep practical guides available for everyone.A practical selection and rollout method
- Write the business objective. State what decision the prediction supports, who consumes it, and what happens if it is delayed or revised.
- Set a measurable service objective. For batch, define a completion deadline or the percentage of work that must finish within a window. For streaming, define maximum data age at the consumer. Add an error or correctness objective.
- Characterize the input. Record whether data is bounded, continuously arriving, replayable, late, duplicated, or partitioned by a stable key.
- Map the full dependency chain. Include ingestion, storage, feature computation, model loading, external calls, prediction sinks, and the application that reads the result.
- Choose the simplest path that meets the objective. Do not introduce a streaming runtime for a report that can wait, and do not schedule a batch job when a stale result would cause harm.
- Define replay and correction behavior. Keep input snapshots, transformation versions, model versions, and prediction timestamps so a disputed result can be reproduced.
- Instrument before optimizing. Measure input age, processing duration, backlog, throughput, late data, failures, output age, and downstream delivery. Alert on the objective, not only on worker health.
- Load-test the limiting dependency. Test normal volume, bursts, slow sinks, unavailable model services, malformed records, and a replay of historical data. Confirm that quotas and regional networking behave as expected.
AI-specific workflow considerations
Inference is compatible with either mode
Model inference can be a transform in a bounded batch job or a step in an unbounded stream. Select batch when loading the model and scoring a finite corpus is simpler; select streaming when each event needs a prediction within the freshness objective. Keep preprocessing identical where possible, but verify that feature availability and time windows mean the same thing in both modes.
Training, evaluation, and serving are different workloads
Training commonly uses historical data and can run as a scheduled batch workflow, while serving may be streaming or request-driven. Evaluation and drift checks can run periodically even when production predictions are continuous. Treat these as separate objectives rather than forcing every stage into one always-on pipeline.
Best Value
Orchestration and lineage
Workflow tools can track model versions, data dependencies, evaluations, and promotion decisions. Beam’s ML overview lists orchestrators such as Kubeflow Pipelines and TensorFlow Extended for automating and tracking AI/ML workflows. Orchestration does not decide batch versus streaming; it makes the chosen process reproducible and observable.
Common failure modes and fixes
Choosing streaming because the system uses AI
Symptom: an always-on job serves results that users consume only once a day. Fix: measure the required freshness and compare it with a scheduled completion deadline; move non-urgent work to batch if the deadline permits.
Measuring only engine latency
Symptom: processing dashboards look healthy while applications receive old predictions. Fix: measure age from source event to consumer-visible output and include sink queues, network delay, and external calls.
Ignoring late and duplicate events
Symptom: scores change unpredictably when delayed records arrive. Fix: define event-time windows, lateness limits, deduplication keys, and correction semantics before production.
Letting backfills compete with live traffic
Symptom: a historical reload causes streaming backlog and missed freshness objectives. Fix: isolate resources with separate pipelines or queues, then reconcile outputs using explicit version and precedence rules.
Assuming the processor is the bottleneck
Symptom: adding workers does not improve end-to-end results. Fix: inspect source quotas, sink capacity, partition skew, regional network paths, model-loading time, and external-service limits.
Bottom line
Use batch for finite or historical work with a completion deadline, streaming for decisions whose value depends on newly arriving events, and hybrid when those requirements coexist. Start by writing the measurable freshness or completion objective, trace it across every dependency, and choose the least complex architecture that meets it. AI inference works in either mode; the timing, completeness, cost, and operational constraints of the workload make the decision.
