When should you train AI models across multiple datacenters instead of one?

Train across multiple datacenters only when one tightly connected facility or accelerator slice cannot provide the capacity, placement, or schedule your run requires—and measurements show the model can tolerate the slower communication path between sites. A second location is not a transparent extension of the first. It changes synchronization, data access, checkpointing, failure recovery, and cost. Establish a single-site baseline, measure the cross-site workload with the same model configuration, and expand only if the added capacity outweighs those coordination costs.

What changes when training crosses a datacenter boundary?

Distributed training workers repeatedly exchange gradients, parameters, activations, or optimizer state. Inside a tightly coupled accelerator slice, those exchanges use a specialized fabric. Google Cloud describes a TPU slice as chips in one TPU Pod connected by high-speed inter-chip interconnects (ICI). Traffic between slices uses the datacenter network (DCN), which has higher latency and lower bandwidth than ICI in the documented architecture.

Training across geographically separate datacenters adds another boundary beyond the TPU multislice example: the path may include additional switches, routers, or a wide-area link. Treat the design as a new communication topology, not as simply adding more local workers. The useful question is not “How many accelerators can we attach?” but “How much of every training step will be spent waiting for the remote group?”

Keep the job in one datacenter or slice when it fits

The model and schedule fit in one placement

If the model, optimizer state, activations, and required batch size fit in one well-connected slice, start there. A single placement generally minimizes synchronization distance and simplifies orchestration. It also gives you a clean performance baseline against which any multi-site plan must compete.

Capacity includes more than accelerator count. Check memory headroom, host CPU and RAM, local storage throughput, interconnect topology, queue time, and the number of accelerators available together. A nominally large cluster may still fail the job if it cannot provide the required topology at one time.

Synchronization is a large share of each step

Data-parallel workers commonly perform an all-reduce after backpropagation. If the all-reduce across the proposed boundary consumes a material portion of the backward pass, adding sites can reduce useful throughput even though the accelerator total increases. Google’s TPU multislice guidance gives a workload-specific test: for strong scaling, DCN all-reduce should take less time than the backward pass. That is a profiling criterion, not a universal latency limit.

Remote reads or synchronous checkpoints already stall training

Training is iterative, so the same dataset shards and metadata may be read many times. NVIDIA’s DGX SuperPOD storage architecture recommends caching to avoid repeated network retrieval. If workers in one location repeatedly fetch data from another, input stalls can erase any compute gain.

Checkpointing has the same issue. A synchronous write can stop forward progress until storage confirms completion. A remote checkpoint target, limited write bandwidth, or long distance between workers and storage increases the pause and may make recovery slower. A single-site design is preferable when local data and checkpoint paths are already close to their performance limits.

Operational simplicity matters more than theoretical scale

One failure domain is easier to monitor, upgrade, and restart. If the run is close to a deadline, a multi-site control plane, cross-location networking, and more complicated recovery path introduce risks that may not appear in a short throughput test.

Consider multiple datacenters when one placement is the bottleneck

The required accelerator count cannot fit together

Capacity is the strongest reason to span sites. If no single facility or slice can supply the model’s memory and accelerator requirements, a multi-site run may be the only way to train at the needed scale. The same applies when a single-site queue would miss a concrete delivery date but capacity is available elsewhere.

Document the constraint precisely: number and type of accelerators, memory per device, host requirements, topology requirements, and the date by which the run must finish. “More capacity” is not enough; quantify what the second site adds and what portion of that capacity the workload can use efficiently.

Measurements show that scaling survives the boundary

Use the actual model, batch size, precision, optimizer, and software stack. A small synthetic benchmark can understate communication from optimizer state, uneven batches, or checkpoint traffic. Compare a single-slice baseline with the intended multi-slice or multi-datacenter placement and record:

  • restart and checkpoint-recovery time; and
  • scaling efficiency relative to the single-site run.

The comparison should use the same effective global batch and training objective. Otherwise, a faster step may simply reflect less work per sample.

A placement, contractual, or resilience requirement outweighs the overhead

Some organizations must keep copies of data in particular jurisdictions, use separate facilities for resilience, or consume capacity under different contracts. Those constraints can justify a multi-location design even when raw throughput is lower. Confirm the applicable data-residency, security, and contractual rules for your dataset and jurisdictions; no single cross-border rule applies to every organization.

A practical decision procedure

  1. Define the single-site baseline. Run enough steps to capture steady-state throughput, communication time, input behavior, checkpoint pauses, and accelerator utilization. Record software versions and topology so the comparison is reproducible.
  2. Map every communication path. List gradient all-reduces, parameter broadcasts, activation transfers, optimizer-state exchanges, control traffic, and evaluation traffic. Mark which paths remain inside a slice and which cross a datacenter boundary.
  3. Choose a candidate parallelism strategy. Start with the strategy that minimizes traffic across the slow boundary. Do not assume that a method that works inside one slice will scale unchanged across sites.
  4. Benchmark the real network path. Measure sustained bandwidth, latency, packet loss, and contention during the hours when training will run. A provider’s headline link speed is not a model-level performance guarantee.
  5. Stage data near workers. Place frequently read shards in each location or use a cache with enough capacity and warm-up time. Measure cache misses and loader wait time rather than relying on storage specifications alone.
  6. Test checkpoint behavior. Measure write duration, whether the training loop blocks, storage throughput, and the time to restore a complete worker group. Test both normal and congested conditions.
  7. Inject realistic failures. Stop a worker, interrupt a site link, and restart from the latest checkpoint. Record lost work, orchestration time, and whether all locations resume with consistent state.
  8. Compare economics and constraints. Include accelerator hours, inter-site network charges, storage requests, idle capacity caused by synchronization, staffing, and any location or compliance requirement. Use measured throughput to calculate cost per trained token or example.
  9. Set a go/no-go rule before production. Define the minimum throughput, maximum checkpoint pause, acceptable recovery time, and budget. If the multi-site run misses any hard limit, keep the job in one site or change the training design.

Choose parallelism that matches the boundary

Data parallelism

Data parallelism gives each worker a complete model replica and exchanges gradients. It is usually the first option to test when a workload already runs well on one slice and the goal is to add slices. Its viability depends on how often and how much data must be reduced across the slower network. For Google TPU multislice strong scaling, the documented check is whether DCN all-reduce completes in less time than the backward pass.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Fully sharded data parallelism

Fully sharded data parallelism can reduce per-device memory by distributing parameters, gradients, and optimizer state. The trade-off is additional communication to materialize and reshard those pieces. Use it when memory is the limiting resource and measured cross-site traffic remains acceptable; do not select it solely because it permits a larger device count.

Pipeline parallelism

Pipeline parallelism places different model stages on different worker groups. It can reduce the amount of synchronization crossing sites, but it introduces pipeline bubbles and depends on batch size and pipeline depth. It is worth testing when the batch can keep stages busy and the measured DCN latency does not dominate transfers between stages.

Tensor parallelism across sites

Tensor parallelism splits individual layers across devices and therefore exchanges activations frequently. Google’s TPU multislice documentation states: “We don’t recommend sharding activations across the model dimensions (sometimes called tensor parallelism) because it requires too much inter-slice bandwidth.” That warning applies to the described TPU multislice environment; it is not a universal prohibition for every accelerator, fabric, or model.

What the published TPU figures do—and do not—tell you

Figure or statement How to use it Limitation
TPU slice uses high-speed ICI Expect lower-latency, higher-bandwidth communication inside the slice. It describes Google’s TPU architecture, not a generic datacenter.
Traffic between slices uses DCN Profile multislice communication separately from in-slice traffic. DCN performance varies by deployment and path.
Maximum network bandwidth of 50 Gbps per TPU host Use it as a platform-specific ceiling when estimating a TPU multislice design. It is not a general WAN or cross-provider benchmark.
Communication expressed in bits per parameter per step Estimate how model size and update frequency affect traffic. The resulting time still depends on actual topology, contention, and software.
DCN all-reduce should be shorter than the backward pass for strong scaling Use the comparison as a workload-level acceptance test. No universal latency, bandwidth, utilization, or accelerator-count cutoff is published.

The TPU guidance concerns slices and DCN communication. It should not be presented as a measured benchmark of geographically distant datacenters. For a true multi-datacenter run, benchmark the complete path your workers will use.

Design data, caches, and checkpoints as part of the topology

Dataset placement

Identify which files are read once and which are read every epoch or step. Replicate hot shards close to each worker group when storage policy allows. For a shared cache, measure warm-up time, eviction rate, and behavior after a site restart. A cache that is fast after an hour of warming may be unusable for short jobs or frequent preemptions.

Checkpoint location and format

Choose whether each site writes a local checkpoint and later replicates it, or whether all workers write to shared storage. Local writes can shorten the pause but require a replication and consistency plan. Shared writes simplify visibility but can create a cross-site bottleneck. Record the complete checkpoint duration, including metadata, optimizer state, and verification—not just the raw file-transfer rate.

Asynchronous versus synchronous writes

Asynchronous checkpointing can keep the training loop moving, but it creates a window in which the newest work is not durable. Synchronous writes provide a clear durability point while blocking progress. Select the policy according to the allowed amount of lost work and verify it under failure, not only during a healthy run.

Failure recovery and governance

Multiple datacenters create multiple failure domains: a site link can fail while both accelerator groups remain healthy, or one location can become unavailable while the other continues running. Your orchestration must define whether to pause, shrink the job, or restart the full worker group. Test that behavior from a known checkpoint and measure how many examples or tokens are lost.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Security and governance are equally topology-dependent. Encryption, identity, key management, audit logs, and data-location controls must work in every participating jurisdiction and facility. The correct legal policy depends on the dataset, contracts, and local law; obtain a deployment-specific review rather than assuming that a multi-site design is permitted.

Common mistakes and how to correct them

Mistake What you will observe Correction
Adding sites because more accelerators are available Device count rises but tokens per second barely changes. Measure communication and useful compute; keep one site if synchronization dominates.
Using a single-site parallelism recipe unchanged Remote activation or gradient traffic causes long stalls. Test data, sharded-data, and pipeline strategies against the actual boundary.
Ignoring input traffic Accelerators are idle while workers fetch remote shards. Stage hot data locally or add a measured cache, then track loader stalls.
Counting only model files in checkpoint estimates Checkpoint pauses are far longer than expected. Include optimizer state, metadata, verification, and replication time.
Assuming provider bandwidth equals application bandwidth Microbenchmarks look good but all-reduce is slow under load. Benchmark the full software stack during representative contention.
Skipping recovery drills A link or site failure causes an unplanned full restart. Interrupt a location deliberately and measure restoration from the latest valid checkpoint.

Does multi-datacenter training make models train faster?

Not automatically. It can shorten elapsed time when the single-site placement is a hard capacity or scheduling bottleneck and the workload scales efficiently across the slower link. If the run already fits in one tightly connected slice, additional sites often trade accelerator capacity for synchronization, data-transfer, and checkpoint overhead. Only a matched baseline and multi-site benchmark can establish which effect wins for your model.

How much bandwidth does distributed AI training need?

There is no source-backed universal number. Required bandwidth depends on parameter count, bytes exchanged per parameter, update frequency, batch size, parallelism strategy, compression, and network contention. Google’s TPU documentation reports a 50 Gbps maximum network bandwidth per host for its described platform, but that figure must not be treated as a general datacenter or WAN requirement. Calculate traffic from your model and validate it on the intended path.

Verdict

Use one datacenter or accelerator slice by default when the job fits and synchronization, data access, and checkpointing are frequent. Move to multiple datacenters when a measured capacity, schedule, placement, or resilience requirement cannot be met otherwise—and only after profiling communication, staging data, testing checkpoint recovery, and pricing the complete operation. The decision is a topology and systems-engineering choice, not a simple “more GPUs is faster” rule.
