What to Check When Distributed AI Training Is Slow or Unstable

Distributed training problems are easiest to solve when you isolate the layer that failed instead of changing NCCL settings at random. First determine whether training is progressing slowly, hanging, failing during initialization, or crashing. Then compare a known-good single-process or single-node baseline and test, in order, rank-to-GPU placement, intra-node GPU links, the inter-node network, container/runtime limits, and only then NCCL tuning.

This sequence applies to PyTorch jobs using NCCL on bare-metal or containerized Linux systems. Keep rank-specific logs and measured bandwidth or latency for every change; without that evidence, a “fix” may simply move the bottleneck.

1. Classify the symptom before changing anything

The same job can appear “slow” for very different reasons. Classification determines which evidence matters and prevents a hang from being treated like a performance problem.

Observed symptom What to record first Most useful initial direction
Slow but still progressing Step time over several minutes, GPU utilization, ranks with lower progress, and the last collective reported Compare against a same-workload baseline, then measure GPU and network paths
Hang or NCCL timeout Rank and timestamp where progress stopped, last collective, and whether all ranks stopped Check rank mapping, peer access, inter-node reachability, and runtime shared memory
Initialization failure Complete warning text, selected interface, node and rank, and versions Inspect fabric reachability, interface selection, container limits, and version compatibility
Crash Exception type, CUDA/NCCL error, rank, and preceding warnings Separate external library or system failures from invalid application usage

Enable focused diagnostics before rerunning. NCCL warnings or INFO logs show initialization, graph, environment, and transport decisions. A useful focused setting is:

NCCL_DEBUG=INFO NCCL_DEBUG_SUBSYS=INIT,GRAPH,ENV

For PyTorch, use TORCH_DISTRIBUTED_DEBUG at an appropriate level and inspect distributed logging. monitored_barrier() can identify ranks that fail to reach a synchronization point. Preserve the complete warning text: ncclUnhandledCudaError and ncclSystemError generally indicate an external library, driver, device, or system failure, while invalid-argument or invalid-usage messages point toward program or launch misuse. NCCL’s RAS facilities can provide additional evidence for hangs and crashes.

2. Establish a controlled baseline

Run the smallest representative workload on the same hardware and software image. Record batch size, precision, number of processes, GPUs per process, step time, memory use, and whether the run completes. A single-GPU or single-node run is not expected to have distributed communication cost, but it establishes whether the model and input pipeline are healthy.

Use the same workload

Keep model, data shape, precision, gradient accumulation, dataloader workers, and checkpoint behavior constant. Compare several steady-state steps rather than startup or the first compilation pass. If single-node multi-GPU is already slow, investigate local topology before adding another node. If one node is normal and the multinode run degrades, prioritize the inter-node fabric.

Change one variable at a time

Do not combine a new NCCL variable, a different launcher, and a container change in one trial. Save the environment, launcher command, rank mapping, and logs for each run. A result is useful only when you can attribute it to one measured change.

3. Verify rank, GPU, CPU, and NUMA placement

Every process using NCCL must have exclusive access to each GPU it uses. Two ranks sharing a device can deadlock or produce invalid NCCL usage even when the machine reports all GPUs as visible.

Check GPU assignment

Inspect CUDA_VISIBLE_DEVICES, the launcher’s local and global rank mapping, and the process environment on every node. Confirm that local rank zero selects the intended first visible GPU, local rank one the second, and so on. Do not assume an orchestrator’s default mapping matches your application’s device selection.

Check CPU and memory affinity

On NUMA hosts, a process can be assigned a distant CPU socket or memory node while its GPU and NIC sit elsewhere. Inspect the actual binding, not just the requested binding. NVIDIA documents this topology command:

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
nvidia-smi topo -m

Use it with:

lscpu --extended=CPU,NODE,SOCKET,CORE

Compare each rank’s CPU set and memory node with its GPU and network interface. Slurm and Open MPI both provide CPU and memory binding controls; verify their effective bindings from inside the running job. Symptoms of poor affinity include lower GPU utilization, inconsistent step times between ranks, and extra host-to-device or host-to-NIC traffic.

4. Test intra-node GPU paths

NCCL performance depends on the real links between the GPUs, not merely on how many GPUs are visible. NVLink, PCIe switches, host bridges, and GPU Direct capabilities can produce very different collective performance.

Inspect topology and peer access

Run:

nvidia-smi topo -m
nvidia-smi topo -p2p p
nvidia-smi topo -p2p n

The first command shows relative GPU, CPU, and NIC placement. The peer-to-peer checks report whether PCIe and NVLink-style paths are available for the relevant devices. A positive peer result does not rule out every system-level problem; ACS settings, IOMMU translation, firmware, or a degraded link can still reduce effective bandwidth.

Measure rather than infer

Use nvbandwidth to measure GPU memory bandwidth and pairwise GPU bandwidth. Compare the measured pairs with the hardware’s documented topology and with the pairs used by your process groups. An unexpectedly weak pair is evidence to investigate NVLink or PCIe layout, GPU Direct prerequisites, PCIe ACS, and, on Linux bare-metal PCIe systems, active IOMMU translation.

Do not invent a universal “good” bandwidth number. Expected results vary by GPU model, link generation, topology, message size, and whether the test is unidirectional or bidirectional. The useful comparison is between your measured value, the same machine’s healthy baseline, and the path your job actually uses.

5. Measure the inter-node fabric independently

A network interface can be up on each host and still be unable to exchange the traffic NCCL requires. Test the fabric without the training application so a model, dataloader, or process-group issue cannot hide the network result.

Run low-level bandwidth and latency tests

For InfiniBand or RoCE environments, use the appropriate perftest tools:

ib_write_bw
ib_write_lat

Run the server and client on the same node pair and interface that the job will use. A multinode nvbandwidth build can add GPU-to-GPU or GPU-to-NIC measurements where supported. Record message size, queue or connection settings, transport, and whether the test is one-way or bidirectional.

Confirm interface selection and peer reachability

Read NCCL INFO output to see which network interface and transport it selected. Confirm that every rank can reach its peers through that interface, not merely that the link is administratively “up.” A wrong interface, firewall rule, subnet mismatch, or partially configured RoCE path can cause initialization failures or hangs.

Check GPU-to-NIC direct communication

When the design relies on direct GPU-to-NIC transfers, verify compatible NIC and driver support and the applicable nvidia-peermem or DMA-BUF path. If direct communication is unavailable, traffic may take a slower host-memory route. Treat that as a measured path difference, not as proof that a particular environment variable should be forced.

6. Inspect containers, shared memory, and runtime versions

NCCL initialization can fail even when hardware tests pass if the process namespace or resource limits are too restrictive.

Check shared and pinned memory

Inspect /dev/shm, container shared-memory limits, and the memlock limit visible inside the container. NCCL troubleshooting examples for Docker increase --shm-size and configure a larger --ulimit memlock; treat those as diagnostic configuration examples, not universal values. Increase limits only as needed for the process group and verify the effective values from inside the container.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Expose useful topology

Confirm that the container can see a meaningful PCI topology through /sys. Missing or incomplete topology information can prevent correct graph construction or make NCCL select an inferior path. Also verify device files, capabilities, and the intended network devices are exposed.

Keep software compatible across nodes

Compare CUDA, NCCL, GPU driver, PyTorch, and communication-runtime versions on every participating node. A mismatch can surface as an external library error, a transport initialization failure, or a crash that looks like a model bug. Capture exact versions from the running environment rather than relying on the image tag or host documentation.

7. Separate application misuse from system failures

Some failures are caused by the launch or collective sequence rather than by hardware. Check that all ranks execute collectives in the same order, use matching tensor shapes and dtypes, and enter barriers consistently. Ensure the process group is initialized once per intended group and that a failed rank is not silently left behind while others wait.

Use PyTorch distributed diagnostics and a monitored barrier around suspicious phases. If one rank reports an invalid argument or invalid usage while others wait, inspect the code path and rank-dependent control flow before changing network settings. If all ranks report an external CUDA or system error, correlate the timestamp with driver logs, device health, and fabric tests.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

8. Tune NCCL only after the measured layers are healthy

When GPU-pair tests, inter-node bandwidth and latency, placement, and runtime limits all match a healthy baseline, then examine NCCL configuration. Keep the original environment and benchmark controlled changes on the same workload.

  • Change one NCCL variable at a time and record its value, NCCL version, topology, and transport.
  • Test more than one message size or training phase; a setting that helps a communication microbenchmark can hurt a real model.
  • Retest after process-count, batch-size, or node-count changes because the optimal transport and algorithm can change.
  • Remove temporary workarounds once the underlying fault is fixed.

NVIDIA’s troubleshooting guidance recommends narrowing the problem before changing NCCL settings. A tuning gain in one benchmark is not evidence of a general improvement elsewhere.

9. Use the evidence to choose the next action

Evidence Likely layer Next action
One rank owns a GPU used by another, or CPU/NIC affinity is distant Launcher or placement Correct device mapping and binding; rerun the baseline
One GPU pair has weak peer bandwidth or no expected path Intra-node topology Inspect PCIe/NVLink layout, ACS, IOMMU, firmware, and GPU Direct prerequisites
Host-to-host perftest fails or varies sharply Inter-node fabric Fix interface, routing, transport, driver, or peer reachability before NCCL tuning
Perftest is healthy but container NCCL initialization fails Runtime limits or topology exposure Inspect /dev/shm, memlock, /sys, device exposure, and versions
All low-level tests are healthy but collectives still stall Application sequence or NCCL configuration Use monitored barriers and focused logs, then test one configuration change

10. A repeatable recovery runbook

  1. Stop the failing run and save rank logs, launcher output, environment variables, and the exact error text.
  2. Label the symptom as slow progress, hang, initialization failure, or crash.
  3. Run a same-workload single-GPU or single-node baseline and record steady-state step time.
  4. Verify exclusive GPU ownership, CUDA_VISIBLE_DEVICES, local-rank mapping, CPU binding, and NUMA locality.
  5. Collect nvidia-smi topo -m, peer-access results, and focused NCCL INFO logs.
  6. Measure pairwise GPU bandwidth with nvbandwidth and investigate anomalous pairs.
  7. Run ib_write_bw, ib_write_lat, or the applicable fabric tests between the actual nodes and interfaces.
  8. Check NCCL’s selected interface, GPU-to-NIC direct path, container shared memory, memlock, PCI topology, and software versions.
  9. Only after these checks pass, benchmark a single NCCL configuration change against the saved baseline.
  10. Keep the change only if it improves the target workload without creating a regression in another tested phase.

What not to assume

  • More visible GPUs automatically means better scaling; topology and peer paths determine communication cost.
  • A link reported as up is proof of end-to-end inter-node usability.
  • A positive peer-to-peer topology result proves the entire PCIe or NVLink path is healthy.
  • A launcher’s requested CPU binding is the binding the process actually received.
  • An environment-variable workaround is portable across NCCL versions, topologies, transports, and workloads.
  • A hardware purchase is the right first response; identify the failed layer and measured capacity limit before replacing or adding equipment.
