What to Check When an AI Model Runs Out of Accelerator Memory

If an AI model run fails with “CUDA out of memory,” first identify when it failed and what it was trying to allocate. A model can fit in accelerator memory as weights yet fail when it needs a key-value cache, activations, communication buffers, or runtime overhead. The right fix depends on the stage, workload, framework, and available hardware—not just the accelerator’s advertised memory capacity.

Start with the failure stage and exact error

Save the complete error message and nearby startup or runtime logs before changing settings. Note whether the failure happens while loading weights, allocating memory for the run, or compiling or warming up an execution graph. Those stages point to different causes and interventions.

For NVIDIA NIM, the troubleshooting guidance for version 2.0.13 distinguishes failures during weight loading, KV-cache allocation, and CUDA graph compilation or warmup. Its recommendations are specific to NIM and that release; check the documentation for the NIM version and model profile actually deployed rather than applying a NIM flag to another stack.

  • Failure while loading weights: the model’s weight placement or representation may exceed available memory. Check the model, precision, device placement, and whether supported offload or multi-GPU options are available.
  • Failure while allocating a KV cache: the requested context or sequence length, along with the number of concurrent sequences, can be a factor. Reduce the maximum context length if the workload allows.
  • Failure during graph compilation or warmup: the run may need additional memory beyond the loaded weights. Use the framework’s logs and documentation for the precise stage; do not assume that a model which loaded successfully has enough headroom for warmup or serving.

These are diagnostic clues, not proof by themselves. Confirm the failed allocation in the logs and compare it with memory use on the device.

Check usable memory, not just the accelerator’s label

Nominal VRAM is not the same as memory available to model tensors. CUDA kernels, the framework, runtime state, and other processes also consume memory. Hugging Face Accelerate cautions that usable memory is below the device’s nominal capacity. Its big-model inference documentation estimates that the first PyTorch allocation loads CUDA kernels taking about 1–2 GB, depending on the GPU. Treat that as a framework-specific documented estimate—not a fixed deduction for every device or software version.

  1. Inspect the device while the workload is running. Record total, used, and free accelerator memory, and note whether another process is using the device. A run can fail because other jobs have occupied memory that the model would otherwise use.
  2. Check host memory too. CPU offload and some device-placement strategies rely on system RAM. A GPU with free memory does not make an offload plan viable if host memory is insufficient.
  3. Compare memory at the failure point. A snapshot taken after the process exits may miss a temporary peak. Use the logs or monitoring available in the environment to observe memory during load, warmup, and the actual workload.

Do not infer that a model will run merely because its weights appear smaller than the accelerator’s advertised memory. The run needs room for the other allocations that occur at the same time.

Identify which part of the run consumes memory

Weights are only one part of the footprint. Inference may additionally allocate a KV cache, temporary activations, communication buffers, and memory for graph capture. Training has its own activation and optimizer-related demands. Context length and workload configuration can therefore make the difference between a successful weight load and a later out-of-memory failure.

Weights

Weight memory depends on parameter count and numerical precision. NVIDIA’s NIM 2.0.13 documentation gives an illustrative estimate: a 70-billion-parameter model in BF16 requires approximately 140 GB for weights. That is an example of weight storage, not a guarantee that a 140 GB accelerator is sufficient; runtime allocations are additional.

Inference cache and workload

A KV cache holds intermediate information used during generation. Longer contexts and concurrent requests can increase its demands. If the failure occurs at cache allocation, examine the maximum sequence or context length and the serving workload before changing weight precision or purchasing hardware. Lowering the configured maximum can reduce memory needs, but it also limits the requests the system can serve.

Training tensors and runtime overhead

Training can fail because a per-device batch creates too much activation memory even when the model’s weights fit. Inference can likewise need memory for temporary tensors and runtime operations beyond the weights and cache. The exact balance varies by model, framework, and workload; the available documentation does not establish one universal memory figure for a given model size.

Choose a remedy that matches the failure

Use the failed stage, memory evidence, and workload requirements to select the least disruptive change. There is no universal benchmark in the cited documentation that predicts the tradeoffs across models or accelerator stacks.

Evidence or constraint Possible intervention What to weigh
Training fails at a large per-device batch Lower per-device batch size; consider gradient accumulation Training throughput and the resulting effective batch behavior
Inference fails allocating KV cache Reduce maximum context or sequence length if acceptable Requests requiring longer context may no longer fit the configured limit
Weights do not fit on one device Use supported multi-GPU placement, lower precision, or offload Hardware and stack support, host-memory needs, speed, and model-quality effects
Allocation fails despite apparently available memory Investigate logs and reserved versus allocated memory before changing allocator settings Allocator configuration is environment-specific and is not a general OOM cure
Workload remains beyond supported capacity Evaluate a higher-memory accelerator or multi-GPU system Compatibility, workload requirements, cost, performance, and software support

For training, reduce the per-device batch first

If the error occurs during training with a batch that is too large for one device, reduce the per-device batch size. Gradient accumulation can help preserve a larger effective batch across multiple smaller forward/backward passes. Transformers v4.46 troubleshooting discusses batch-size reduction and gradient accumulation; parameter names and configuration paths can vary by library version, so consult the documentation for the version in use.

After changing the batch, rerun the same workload and monitor memory. If it still fails, examine other training allocations and the exact point of failure rather than repeatedly shrinking the batch without evidence.

For inference, address context, placement, or precision

Reduce context length when cache pressure is the issue

If logs indicate that KV-cache allocation is the failure, reduce the maximum sequence or context length when product requirements permit. This targets a runtime allocation rather than the model weights. Test with representative prompts and concurrency: a short single-request test may not reflect the memory demand of longer or simultaneous requests.

Use device maps or offload when placement is supported

Hugging Face Accelerate supports device maps that spread layers across available GPUs and can offload weights to CPU or disk. These options can make a model fit within accelerator memory, but they depend on the model and framework setup. CPU or disk offload also has performance implications, and CPU offload requires sufficient host resources. Verify the placement behavior and capacity needs for the specific configuration.

Consider parallelism or lower precision only with support

NVIDIA NIM documentation describes model profiles with greater tensor or pipeline parallelism and lower-precision options. These are not universal switches: the profile, model, hardware, and deployed NIM release must support them. Lower precision can affect model outputs, while parallelism changes how work is distributed and may affect performance. Validate quality and throughput for the intended use rather than assuming that a smaller representation is consequence-free.

Treat fragmentation as a specific diagnosis

Memory fragmentation is sometimes blamed for an allocation failure even when the evidence points elsewhere. NVIDIA NIM 2.0.13 documents a narrower case: a contiguous allocation fails while substantial memory is reserved but unallocated. For that NIM case, its guidance identifies the PyTorch allocator setting PYTORCH_ALLOC_CONF=expandable_segments:True.

Use this setting only when the failure evidence matches the documented condition and the deployed NIM version supports the advice. It is not a general fix for insufficient capacity, an oversized batch, a long context, or a model whose weights do not fit. Check the current release documentation before applying serving flags or allocator configuration.

Know when capacity is the remaining limit

If the workload still exceeds supported memory after the relevant batch, context, precision, and placement settings have been evaluated, the remaining issue may be capacity. A higher-memory accelerator or a multi-GPU configuration could be appropriate, but only after checking compatibility with the model, framework, and serving stack. The available guidance does not identify a particular product or provide a cross-model benchmark that can guarantee a specific memory requirement.

Before changing hardware, write down the actual workload: model and precision, maximum context, concurrency or per-device batch, failed allocation stage, accelerator and host memory, and supported placement options. Those details determine whether additional capacity addresses the limiting allocation or whether a configuration change is more appropriate.

A practical troubleshooting checklist

  1. Capture the exact error and logs, including the run stage at failure.
  2. Check free accelerator memory and competing processes at the time of the run; check host memory if offload is involved.
  3. Determine whether the failed allocation concerns weights, KV cache, training activations, graph capture, or another runtime operation.
  4. For training batch pressure, lower the per-device batch and consider gradient accumulation.
  5. For inference cache pressure, lower the maximum context or sequence length if the workload can tolerate it.
  6. If weights do not fit, verify supported device maps, offload, multi-GPU profiles, or precision options for the exact stack and model.
  7. Use allocator configuration only when logs match a documented fragmentation case for the version in use.
  8. Rerun a representative workload and assess memory, latency, throughput, and output quality before treating the issue as resolved.

How to compare possible fixes

Compare remedies against the allocation that failed rather than treating them as interchangeable. Reducing batch size targets training pressure; shortening context targets inference cache demand; changing placement or precision targets a model that cannot be loaded in its current configuration. Each may relieve memory pressure, but they change different things about the workload.

Before choosing, check five practical constraints: the failure stage, whether weights or runtime tensors dominate, available accelerator and host memory, whether multiple GPUs and a supported device map are available, and the required throughput, latency, precision, and context length. For example, offload might solve a placement limit while affecting performance; lowering the context limit could help cache allocation but rule out long-context requests. There is no verified cross-model benchmark here that can quantify these tradeoffs in advance, so validate against a representative workload.

Hardware cost cannot be estimated from a memory error alone. The appropriate choice depends on the workload and platform compatibility, and the cited guidance does not establish a retail product or price. Cooling accessories are not established by this evidence as a remedy for memory-allocation failures. Treat additional hardware as a conditional option when diagnosis shows a remaining capacity constraint, not as the first response to an unexplained OOM.

Do not assume every accelerator error is CUDA-specific

“CUDA out of memory” is a documented error phrase and can be a useful search term, but CUDA and NVIDIA-specific advice does not cover every accelerator stack. Other frameworks and devices may expose different error text, memory reporting, placement controls, or allocator settings. Preserve the exact message and use documentation for the runtime and version in the failing environment. In particular, do not transplant a NIM-specific profile recommendation or PyTorch allocator flag to an unsupported stack.

Frequently Asked Questions

What should I check first when I see “CUDA out of memory”?

Save the complete error and logs, identify whether failure occurred during weight loading, KV-cache allocation, training, or graph compilation/warmup, and inspect available memory and other processes at that time. The failed stage is a clue to the allocation that needs attention.

Why can a model load successfully and then run out of memory?

Loading weights is only one memory requirement. Inference may later allocate a KV cache, activations, communication buffers, or graph-capture memory; training can also need substantial activation memory. Runtime overhead and other processes reduce the memory available beyond the weights.

Should I use PYTORCH_ALLOC_CONF=expandable_segments:True for every out-of-memory error?

No. NVIDIA NIM 2.0.13 documents it for a specific case involving a failed contiguous allocation alongside substantial reserved-but-unallocated memory. Confirm that the logs match and that the deployed NIM version supports the setting; it is not a general fix for insufficient capacity or an oversized workload.

Will adding another GPU or buying one with more memory fix the problem?

It may help if diagnosis shows that the supported workload still exceeds capacity, but it is not guaranteed. Verify compatibility with the model, framework, and serving stack, and consider whether supported placement or offload options are available. No single accelerator memory figure guarantees that every model and workload will run.

The Bottom Line

When an AI run runs out of accelerator memory, start with the exact error, failure stage, and memory use at that moment. Then match the change to the allocation: batch size or gradient accumulation for training pressure, context length for inference cache pressure, and supported placement or precision options when weights do not fit. Treat allocator flags and hardware upgrades as conditional choices, and validate changes on a representative workload.
