No single configuration change fixes every slow or expensive deployment. Use the sequence below to identify the bottleneck, test a targeted change, and verify the result against latency, quality, utilization, and total cost.

1. Define exactly what is slow or expensive
“High latency” can mean several different measurements. Record the endpoint, deployment or model version, cloud region, affected time window, request volume, traffic pattern, and service-level objective (SLO). Compare the incident with a representative period when the service met its target.
- End-to-end latency: elapsed time from the client request until the complete response arrives.
- Time to first token (TTFT): how long a streaming request waits before the first generated token.
- Inter-token latency: the interval between generated tokens after streaming begins.
- Queueing time: time spent waiting for an available worker, batch, or accelerator.
A service can have acceptable TTFT but slow token generation, or fast generation after a long queue. AWS Prescriptive Guidance states: “Inference performance is highly dependent on the characteristics of the requests being processed.” That is why the baseline must include both the metric and the request conditions that produced it.

Build a baseline before changing capacity
For the same endpoint and region, record a normal period and the affected period. Include request rate, concurrent requests, prompt-token length, completion-token length, error rate, p50 and tail latency if available, and the SLO target. Note deployments, model updates, traffic migrations, autoscaling-policy changes, logging changes, and new downstream calls in the same time window.
Do not compare an average request with a peak burst and conclude that the machine is undersized. A deployment serving the same model can need different infrastructure when prompts, completions, concurrency, or latency objectives change.
2. Characterize the workload that the endpoint is actually serving
Measure the demand that reaches the inference service, not only the number of API calls. Capture:
- Prompt length distribution, including unusually long context windows.
- Completion length and the fraction of requests that stream or generate long answers.
- Average and peak request rate.
- Concurrent requests and fan-out, such as one user request triggering multiple model calls.
- Batch traffic, scheduled jobs, retries, and traffic bursts.
- Changes in routing, retrieval context, tool calls, guardrails, or post-processing that add model or service work.
Longer prompts increase prefill work and memory pressure; longer completions keep workers occupied. A modest increase in average traffic can still create a queue when a short burst exceeds available concurrency. Check distributions and peak behavior rather than relying on one daily average.

Look for demand changes before buying more compute
Compare current prompt and completion tokens with the baseline. Check whether a retrieval change now sends more documents, whether a client retry loop is duplicating requests, or whether a new workflow fans one request into several. Confirm that concurrency limits and client-side timeouts have not changed. If demand is higher, the capacity decision should be based on the new workload and SLO, not on the old sizing exercise.
3. Break latency into measurable serving stages
For a token-generating endpoint, inspect the metrics exposed by your serving stack. Useful signals include TTFT, inter-token latency, queue depth, batch size, tokens per second, key-value (KV) cache use, GPU and CPU utilization, memory pressure, model download and load time, cold starts, and autoscaling events.
Amazon SageMaker documents detailed observability for supported vLLM and SGLang configurations. Its framework-specific metrics include TTFT and inter-token latency, alongside framework, GPU, node, lifecycle, and scaling metrics. The feature uses OpenTelemetry; the documented default scrape interval is 60 seconds, configurable from 10 to 300 seconds. These details apply to eligible SageMaker inference endpoints and should not be assumed for every provider or serving stack. SageMaker states that the detailed observability metrics are included at no additional cost, while noting that CloudWatch data-ingestion charges may apply.

| Observed pattern | What it may indicate | Checks before changing capacity |
|---|---|---|
| Queue depth and TTFT rise with concurrency; utilization is near a limit | Demand is exceeding available serving capacity or the autoscaler is late | Compare queue growth with scale-out events, concurrency limits, batch size, and SLO breaches |
| Inter-token latency rises while TTFT remains stable | Generation throughput, memory pressure, or scheduling may be constrained | Check tokens per second, KV-cache use, GPU memory, batch composition, and completion lengths |
| TTFT rises while GPU utilization is low and queues are absent | Time may be spent loading a model, waiting on networking, or in application orchestration | Inspect cold starts, model-load duration, storage reads, network calls, and upstream dependencies |
| Latency jumps only during scale-out | New workers may be downloading or initializing the model | Measure startup and model-load time and compare it with autoscaling timing |
| All serving metrics look normal but end-to-end latency is high | Client, gateway, retrieval, guardrail, database, or downstream service time may dominate | Trace spans across the complete request path, including retries and serialization |
These are diagnostic hypotheses, not universal interpretations. The architecture and metric definitions determine what each pattern means.

4. Test capacity and autoscaling together
High latency alone does not prove that a larger accelerator or more instances will solve the problem. Compare latency with concurrency, queue depth, GPU and CPU utilization, memory pressure, and the scale-out timeline.
- Confirm demand: identify whether request rate, token lengths, fan-out, or retries increased.
- Confirm saturation: determine whether workers, GPU memory, CPU, or queue slots are actually constrained.
- Check scaling response: measure how long a new instance takes to become ready, including model download and initialization.
- Check scale-in behavior: verify whether workers are removed too quickly, causing repeated cold starts during fluctuating traffic.
- Run a controlled comparison: replay a representative workload and compare TTFT, inter-token latency, throughput, utilization, SLO compliance, and cost.
If latency rises while demand exceeds available capacity and queues build, capacity or scaling behavior is a credible cause. If utilization is low and queues are absent, investigate model loading, networking, orchestration, or upstream dependencies before purchasing more compute.
Model loading and cold starts
For Google Cloud Run deployments using the documented GPU model-loading paths, examine model storage and network configuration, cache behavior, and build-time transformations. Caching can reduce read latency but adds cost. Apply these recommendations only when the deployment uses that Cloud Run architecture; they are not general advice for every cloud endpoint.

Build an AI deployment cost ledger
| Component | What to measure | Questions to answer |
|---|---|---|
| Model or inference charges | Requests, input tokens, output tokens, model tier, and routing | Did token volume or model selection change? |
| Hosting compute | Instance or accelerator hours, replicas, idle time, and startup churn | Did autoscaling add capacity, or are replicas idle? |
| Storage | Model artifacts, cache, logs, checkpoints, and retention | Did a cache or retained artifact grow? |
| Vector database | Storage, query count, index size, and replicas | Did retrieval volume or index replication increase? |
| Network and supporting services | Data transfer, gateways, queues, functions, and databases | Did a new region or extra hop add traffic? |
| Guardrails and application logic | Moderation, safety, parsing, retries, and tool calls | Is one user request producing multiple billable operations? |
| Observability | Log, metric, and trace ingestion; retention; custom dimensions | Did telemetry volume rise independently of user traffic? |
AWS cost guidance for AI applications calls out query volume and patterns, prompt and completion token counts, model token prices, hosting infrastructure, vector-database storage and queries, and guardrails. Use the billing dimensions and current prices for your provider and region; no universal price or percentage applies across deployments.
Use labels and exports that preserve attribution
Apply consistent labels to projects, environments, services, models, and experiments before a cost spike occurs. Google Cloud recommends resource labels, billing exports for detailed analysis, anomaly detection, and simultaneous tracking of cost and performance while testing. A useful export lets you answer “which workload changed?” rather than only “which service was expensive?”
Separate one-time events from recurring spend. A model migration, a temporary load test, or a backfill can create a large single-period charge without changing the steady-state unit cost. Conversely, a small daily increase can become the dominant monthly variance when it persists.

Telemetry can increase costs even when inference traffic is unchanged. Inspect ingestion by table, source, workload, and time. Look for a new data source, agent migration, overlapping collection rule, higher sampling rate, verbose application logs, duplicate traces, or custom metrics with many dimensions.
Best Value
Microsoft Learn states: “The primary factor for the cost of Azure Monitor is the amount of data that you collect in your Log Analytics workspace, so you should ensure that you collect no more data than you require to assess the health and performance of your services and applications.” This guidance applies to Azure Monitor and Application Insights collection configuration.
Telemetry checks
- Compare ingestion volume with request volume and token volume.
- Find tables or sources whose daily ingestion changed first.
- Check for duplicate agents, overlapping diagnostic settings, and repeated export rules.
- Review log levels for prompts, completions, headers, payloads, and stack traces.
- Inspect custom metric dimensions for high-cardinality values such as request IDs, full URLs, or user identifiers.
- Review trace and metric sampling rates and retention periods.
- Remove instrumentation that is not used for an alert, dashboard, investigation, or compliance requirement.
Sampling is a trade-off: collecting less data can lower cost but reduce responsiveness or investigative detail. Do not switch off telemetry blindly while diagnosing latency. Keep the signals needed to see TTFT, queueing, utilization, scaling, errors, and end-to-end traces; filter or sample data that does not support an operational decision.
7. Compare serving options with one representative workload
When evaluating another instance type, serving engine, region, or provider, hold the workload constant. Use the same model version, prompt and completion distributions, concurrency, traffic burst, quality checks, and SLO.
| Comparison axis | Measurements to record |
|---|---|
| Latency | TTFT, end-to-end latency, tail latency, and inter-token latency when streaming |
| Capacity and load behavior | Throughput, concurrency, queueing, batch size, utilization, startup time, model-load time, and autoscaling response |
| Total cost | Model or token charges, compute, storage, network, vector queries, guardrails, and monitoring ingestion |
| Quality and operations | Task quality, error rate, availability, region and quota availability, data requirements, and deployment constraints |
Google recommends experimenting across CPU, memory, GPU or TPU, and storage configurations while tracking utilization, cost, latency, and model accuracy. Compare the measured performance gain with the associated cost rather than selecting the largest accelerator by default.
8. Apply fixes in a controlled order
- Correct the workload issue: stop duplicate retries, unintended fan-out, oversized retrieval context, or unbounded completion lengths.
- Fix serving configuration: adjust concurrency, batching, cache settings, or worker limits only when the relevant metric shows a constraint.
- Fix scaling behavior: tune thresholds, cooldowns, minimum capacity, and startup strategy after measuring demand and cold-start time.
- Fix model-loading paths: optimize storage access or caching when model download and initialization dominate startup.
- Fix application bottlenecks: remove unnecessary network hops and investigate retrieval, guardrail, database, and serialization stages.
- Fix telemetry collection: reduce duplicate, verbose, high-cardinality, or unused data while retaining diagnostic signals.
- Re-run the representative test: verify latency, quality, utilization, error rate, and cost over a period long enough to include normal and peak behavior.
9. A practical incident checklist
- Endpoint, model version, region, deployment version, and incident window recorded.
- Latency definition identified: end-to-end, TTFT, inter-token, or queueing.
- Baseline and SLO documented.
- Prompt length, completion length, concurrency, peak traffic, retries, and fan-out compared with baseline.
- Queue depth, batch size, tokens per second, KV-cache use, GPU, CPU, memory, and autoscaling reviewed where available.
- Cold starts, model downloads, storage reads, network calls, and downstream dependencies checked.
- Billing attributed by project, labels, workload, component, and time period.
- Token, compute, storage, vector-query, guardrail, network, and monitoring costs reconciled.
- Telemetry ingestion, duplicate collection, sampling, retention, and high-cardinality dimensions audited.
- Any capacity or configuration change tested against the same workload and measured for both performance and cost.
What the evidence can and cannot establish
There is no universal accelerator size, autoscaling value, scrape interval, or price that resolves every incident. The correct action depends on the provider, model, serving stack, architecture, region, quota, request pattern, and billing records. SageMaker’s vLLM and SGLang metrics, Azure Monitor collection guidance, and Cloud Run GPU model-loading advice are provider- and configuration-specific. Treat them as implementation references, not guarantees that another endpoint exposes the same signals or charges the same way.
Verify the cause before applying the fix. A successful change is one that improves the affected latency measure or cost component without unacceptable regression in model quality, availability, utilization, or observability.
