What Is Evaluation Leakage in Language Models, and How Can You Detect It?

Evaluation leakage occurs when benchmark questions, answers, explanations, or close variants appear in data used to train or fine-tune a language model. A model can then score well partly because it has seen the evaluated material, not only because it generalizes the underlying skill. Detecting leakage requires matching evaluation items against available training text when possible, and using carefully designed black-box probes when the training corpus is private. A match is evidence under a defined test; a failed search is not proof that no exposure occurred.

Why evaluation leakage changes what a score means

Benchmark accuracy is intended to estimate performance on examples the model did not see during learning. If a test item, its answer, or a close derivative was included in pretraining or later fine-tuning, the score can combine two effects: genuine capability and familiarity with the evaluated material. The presence of a match does not reveal how much of the score came from memorization, nor does it establish that every other item was exposed.

Leakage is also distinct from misconduct. Benchmark material is often published on the open web, so overlap may be accidental. A detection result should therefore be reported as evidence of possible contamination unless the method, data access, and statistical assumptions justify a stronger conclusion.

The term covers several exposure patterns:

  • Verbatim test questions or passages in a training corpus.
  • Answers, rationales, or worked solutions without the original question.
  • Reformatted, translated, paraphrased, or otherwise altered versions.
  • Benchmark development or practice data that are highly similar to the final test.
  • Later supervised fine-tuning on evaluation material.

These categories can have different effects, and a report that simply labels a model “contaminated” without saying what was checked is difficult to interpret.

Start by defining the exposure you are testing

Before running a detector, write down the hypothesis. Are you looking for exact test questions in a candidate pretraining dump, answer-only exposure, benchmark variants, or behavior suggesting that a private model saw the test? Also record the benchmark version and the model checkpoint or API date. A benchmark can change while retaining its name, and a model can receive updates after an initial evaluation.

Define the unit of analysis (question, document, answer choice, or token span), the similarity rule, and what counts as a positive. This prevents a broad claim from being inferred from a narrow scan. For example, “no 13-gram match in the 40-billion-token corpus we inspected” is materially different from “the model was never trained on this benchmark.”

When training text is available: corpus comparison

Build a reproducible exact or n-gram scan

The most direct procedure compares benchmark text with the candidate training corpus. Normalize both sides using a documented policy—for example, Unicode normalization, whitespace handling, case treatment, and punctuation rules—then index sequences from the evaluation set and search the corpus for those sequences. Exact matching is easy to audit but misses small edits. N-gram matching tolerates some surrounding variation while remaining computationally practical.

EleutherAI’s lm-evaluation-harness documentation describes indexing evaluation n-grams and marking evaluation/document pairs that share them. Its implementation uses 13-grams for simplicity. The documentation also notes that an earlier OpenAI approach used n values between 8 and 13 depending on the dataset. These are implementation choices, not universal contamination thresholds: changing n, normalization, or exclusions changes the number of matches.

Record the settings with the result

  • Exact benchmark release and item count.
  • Corpus files, snapshots, and tokenization or text extraction method.
  • N-gram length, normalization rules, and minimum match count or span length.
  • Whether benchmark answers, explanations, metadata, and surrounding context were searched.
  • Deduplication and exclusions, including publicly available benchmark pages.
  • Number of candidate pairs found and number judged meaningful after review.

Inspect every important hit

Automated matches produce candidates, not verdicts. Common instructions, boilerplate, names, and short phrases can create coincidental overlap. Review the surrounding document and the benchmark item together. A long, distinctive sequence containing the question and answer is stronger evidence than a short shared phrase. If several independent items occur in the same source document, record that pattern, but do not convert it into an estimate of score inflation without a separate analysis.

Use a second similarity method for borderline cases, such as edit-distance or semantic retrieval, and label it as a follow-up screen. A semantic match can find paraphrases but can also increase false positives; it should not silently replace the original rule.

State what the scan cannot establish

A corpus scan only covers the text you obtained. It cannot reveal exposure through an unscanned private dataset, a data source that was deleted, or a model provider’s undisclosed fine-tuning. It also misses many transformed versions. A clean result therefore means “no qualifying match under these settings in this corpus,” not “no exposure.”

When training data are private: black-box behavioral probes

Closed models do not expose a complete training manifest. You can still test for behavioral signals, but these probes do not reconstruct the model’s history or identify the source of a possible exposure.

Testset Slot Guessing

Deng and co-authors’ Testset Slot Guessing masks a wrong answer option in a multiple-choice question or hides an unlikely word from an example, then asks the model to fill the gap. The idea is that unusually strong recovery of a specific missing slot may indicate familiarity with the benchmark item.

In the authors’ 2024 MMLU experiment, ChatGPT recovered the missing option exactly 52% of the time and GPT-4 did so 57% of the time. Those percentages are results from that study’s prompts, models, and item construction—not general rates for current systems and not a universal contamination cutoff. A high recovery rate can also reflect question structure, answer-choice regularities, or broad world knowledge. Use matched control questions and report the prompt, masking rule, sample size, and confidence interval.

Canonical-order versus shuffled-order likelihood

Oren and co-authors propose a statistical test that compares a model’s likelihood for a benchmark presented in its canonical order with the likelihood after the examples are shuffled. If the canonical sequence receives an unexpectedly higher likelihood, that asymmetry can support the tested contamination hypothesis. The paper states that the test has exact false-positive guarantees and does not require pretraining data or model weights.

This method requires meaningful likelihood access, such as token probabilities or a compatible scoring interface. A chat endpoint that returns only text may not provide the necessary signal. The test result applies to the specified ordering, prompts, model version, and statistical threshold; it is not a complete provenance record.

Use controls and replication

Behavioral probes are sensitive to wording and sampling. Run multiple prompt templates, fixed decoding settings, and control items from the same domain. Hold out a confirmation set so that prompt tuning does not turn the test into an evaluation of the probe itself. If a provider updates the model during the study, retain timestamps and repeat the probe on the same version where possible.

How the main detection methods differ

Method Access needed Signal Primary limitation
Exact or n-gram overlap Candidate training text and evaluation set Shared surface sequences Misses unscanned data and many changed or indirect variants; thresholds depend on normalization and n-gram choices.
Testset Slot Guessing Query access to the model and benchmark examples Recovery of a masked answer or unlikely word A probe does not identify the exposure source or prove that a benchmark was in training; published percentages are experiment-specific.
Canonical-order likelihood test Black-box likelihood access and benchmark ordering Difference between canonical and shuffled sequence likelihood Tests a statistical signal rather than full training-data provenance.
Inference-time rewriting Model query access and a rewriting procedure Performance change on rewritten suspected examples Rewriting changes test inputs and may change difficulty or task utility.
DyePack backdoor method Ability to create and include backdoor examples in an evaluation set Triggered behavior associated with benchmark use Specialized method evaluated only in the paper’s tested setup.
Kernel Divergence Score Embeddings before and after benchmark fine-tuning Change in embedding-kernel similarity structure Depends on the method’s assumptions and experimental setup; it is not direct corpus matching.

Inference-time decontamination: detection and mitigation together

One response to suspected leakage is to rewrite evaluation items at inference time and compare performance before and after the intervention. Zhu and co-authors report proof-of-concept reductions in inflated accuracy of 22.9% on GSM8K and 19.0% on MMLU. In the same 2024 Findings of EMNLP study, MMLU results decreased by 6.7% for Phi-3 and 3.6% for Mistral under the reported procedure.

These numbers describe that paper’s models, prompts, rewriting system, and benchmarks. They are not expected reductions for another model. Rewriting can remove a memorized string, but it can also alter the task, introduce ambiguity, change difficulty, or damage the very skill being measured. Report the original and rewritten conditions side by side, preserve the rewrite rules, and have reviewers check that the underlying question remains equivalent.

Specialized research methods

DyePack backdoor samples

DyePack mixes specially constructed backdoor examples into a test set and looks for a triggered response pattern associated with having used that material during training. Cheng and co-authors report guaranteed false-positive rates as low as 0.000073% on MMLU-Pro and 0.000017% on Big-Bench-Hard when using eight backdoors, and 0.127% on Alpaca when using six backdoors. Those figures retain the datasets and backdoor counts from the authors’ EMNLP 2025 abstract. The approach is useful when an evaluator controls test-set construction, but it is not a universal detector for an already deployed model and ordinary benchmark.

Kernel Divergence Score

Kernel Divergence Score estimates contamination through changes in embedding-kernel similarity before and after fine-tuning on a benchmark. Choi and co-authors present it as a research method tied to its assumptions and experimental setup. It can provide another signal when suitable embeddings and checkpoints exist, but a divergence score should not be read as a direct count of leaked examples.

A practical end-to-end workflow

  1. Freeze the target. Record the benchmark name, version, item files, model identifier, endpoint, and evaluation date.
  2. Define exposure categories. Specify whether you will test questions, answers, explanations, variants, or later fine-tuning data.
  3. Choose the strongest available evidence. Use corpus matching when candidate training text exists; add behavioral probes for private models.
  4. Run the first-pass scan. Apply exact and documented n-gram matching, retaining the settings and all candidate pairs.
  5. Review candidates. Classify hits as distinctive, ambiguous, or coincidental; preserve examples and reviewer decisions.
  6. Probe closed models cautiously. Use masked-slot tests, shuffled-order likelihood tests, or both, with controls and repeated prompts.
  7. Test robustness. Vary masking, ordering, normalization, and item subsets. A signal that disappears under a small justified change is weaker.
  8. Separate detection from mitigation. If you filter data, build a new test, or rewrite items, evaluate and report the intervention as a changed condition.
  9. Publish uncertainty. State corpus coverage, false-positive controls, transformed-version limits, model version, and what remains unknown.

How to interpret a suspicious score

  • One exact match: evidence that the scanned corpus contains overlapping text; it does not quantify the effect on the benchmark score.
  • Many distinctive matches: stronger evidence of possible contamination, especially when questions and answers occur together, but still limited to the corpus and matching rule.
  • High slot-guessing recovery: a behavioral signal that needs controls; it does not identify when or where exposure occurred.
  • Canonical-order preference: evidence for the statistical hypothesis under the stated likelihood and shuffling procedure, not proof of a complete training-data history.
  • No detected overlap: a negative result under the searched corpus and transformations, never proof that the model had no exposure.

Do not subtract a detected match from accuracy as though every matched item were memorized. Estimating score inflation requires a validated counterfactual—such as an equivalent clean test, a carefully audited transformed set, or a model comparison designed for that purpose.

How to report a leakage analysis responsibly

A useful report lets another evaluator reproduce the claim. Include:

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
  • The benchmark release, model version, endpoint and date.
  • The exposure definition and every data source searched.
  • Normalization, n-gram length, thresholds, exclusions and software version.
  • Candidate and manually confirmed match counts, with representative examples.
  • Probe prompts, masking or shuffling rules, decoding settings and controls.
  • Confidence intervals or false-positive guarantees where the method provides them.
  • Whether filtering, rewriting or a new test set changed the evaluated inputs.
  • A direct statement of what the evidence cannot establish.

Use precise language such as “we found 184 qualifying 13-gram overlaps in the scanned corpus” or “the model showed a canonical-order likelihood difference under the stated test.” Avoid saying that a model “cheated” unless independent evidence establishes intent and the relevant training process.

Bottom line for evaluators

Evaluation leakage is a validity problem: benchmark scores become harder to interpret when evaluated material may have been part of training. The best practice is layered. Compare benchmark items with every candidate training source using transparent exact and n-gram rules, inspect hits, and disclose coverage limits. For private models, use slot-guessing or canonical-order likelihood probes with controls, treating them as behavioral evidence rather than a training manifest. If you filter or rewrite items, report the intervention and its effect separately. A credible conclusion says exactly what was tested, what signal was found, and what remains unknowable.
