Calibration asks whether a zero-shot model’s confidence behaves like a probability: among predictions assigned about 0.8 confidence, is the model correct roughly 80% of the time on comparable inputs? It is a test or adjustment of probability reliability, not a guarantee that the model is accurate.
Calibration is about trustworthy probabilities
A classifier can choose the right class often while reporting confidence scores that are systematically too high or too low. Calibration measures the agreement between those scores and observed correctness frequencies. If a model repeatedly assigns a prediction a confidence near 0.8, a calibrated system should be correct about 80% of the time across an appropriate collection of similar predictions. The 0.8 example is an interpretation of calibration, not a published performance statistic.

This distinction matters because many applications use confidence as a control signal. A threshold may route low-confidence items to a human, a ranking system may show the highest-confidence results first, and an automated workflow may abstain when uncertainty is high. Those decisions depend on the score meaning what it appears to mean.

A model may retain exactly the same top-ranked label after calibration while reporting probabilities that better reflect its historical correctness. Conversely, a model can have useful ranking accuracy and still be overconfident. Treat accuracy, ranking quality and probability reliability as separate evaluation questions.

What zero-shot changes—and what it does not
Zero-shot classification predicts among labels or concepts without task-specific labeled training examples for the target task. That prediction setup does not make confidence inherently reliable. A pretrained model can recognize a plausible label while being poorly calibrated for a new domain, label vocabulary or input format.
Zero-shot also does not mean that no data can be used at all. Ordinary post-hoc calibration usually fits an adjustment on held-out labeled examples. Other procedures may use unlabeled inputs or transfer information from a related setting. The data requirement belongs to the calibration method, not to the zero-shot label-prediction definition.
Reliability is tied to the deployment distribution. A calibration relationship learned on one population can change when language, image style, class frequencies, user behavior or sensor conditions change. Evaluate on data that resemble the inputs and decisions for which the confidence score will be used.

Use grouped frequency checks
Collect predictions from a representative validation set and group them by confidence ranges, such as 0.6–0.7 or 0.8–0.9. For each group, compare the average reported confidence with the fraction of predictions that are correct. A reliability diagram plots those two quantities; points close to the diagonal indicate better agreement. Large gaps reveal overconfidence or underconfidence.
A single summary, such as an expected calibration error, can compress these gaps into one number, but the summary can hide important behavior. Two models may have similar average error while one fails badly on a high-stakes confidence range. Inspect the bins that correspond to your actual threshold or abstention policy.

Keep calibration data separate from final evaluation
If labeled examples are used to fit a calibration adjustment, reserve independent data for the final check. Reusing the same examples can make the probabilities look reliable simply because the adjustment has adapted to those observations. The held-out set should contain the classes, environments and prevalence expected at deployment.
Check more than the top label
Calibration can concern the probability assigned to the selected class or the full distribution over candidate labels. A model that ranks labels correctly may still assign nearly all probability to the first choice when several labels are plausible. Decide whether your application needs a calibrated top-class score, meaningful probabilities for every label, or a rule for abstention.

Temperature scaling: the common post-hoc baseline
Temperature scaling adjusts logits before the softmax operation. If a model produces a logit vector z, the calibrated probabilities are computed as softmax(z / T), where T is a learned positive scalar. The parameter is fitted on held-out labeled calibration examples, usually by minimizing a probability loss.
For a fixed logit vector, dividing by a temperature changes concentration without changing the order of the logits. A temperature greater than one softens the distribution, reducing extreme probabilities; a temperature below one sharpens it. Because the class ranking is preserved, this procedure can improve probability reliability without changing top-1 accuracy.
Guo and colleagues describe temperature scaling as a single-parameter method and report that it was effective on most of the datasets they studied in On Calibration of Modern Neural Networks (2017). That is an empirical result from those experiments, not a guarantee for every zero-shot model or distribution.

Temperature scaling is not label-free when its parameter is learned in the ordinary way. If no labeled examples from the target task are available, you cannot assume that a fitted temperature is valid. You must either obtain a representative calibration sample, use a method designed for unlabeled or transferred information, or report that the probabilities have not been calibrated for the target use.

The following process separates model performance from confidence reliability and makes the data assumptions explicit.
- Define the decision. Specify whether confidence will set an acceptance threshold, rank outputs, trigger human review, or support a prediction-set size. The required calibration resolution depends on that decision.
- Freeze the zero-shot predictor. Fix the prompt or label descriptions, preprocessing, model version and decoding settings. Changing any of these after calibration changes the score distribution.
- Assemble representative examples. Use labeled examples if you intend to fit a supervised adjustment. Include the operating environments and class mix that matter in deployment. If labels are unavailable, document that limitation rather than treating raw scores as calibrated probabilities.
- Measure baseline reliability. Record confidence, predicted label and correctness. Inspect reliability bins and the confidence range used by your policy. Also record accuracy, since calibration cannot tell you whether the underlying labels are appropriate.
- Fit an adjustment only on calibration data. Temperature scaling is a simple baseline when enough labeled examples are available. More flexible adjustments can overfit, especially when the calibration sample is small.
- Evaluate on untouched data. Compare reliability and accuracy before and after adjustment. Verify that the calibration set and evaluation set represent the same intended deployment conditions.
- Stress-test changes in distribution. Check separate slices for domains, classes, languages or time periods when those differences affect inputs. A good aggregate calibration result can conceal poor reliability for a subgroup.
- Set an operational rule. Choose a threshold or abstention policy from the calibrated evaluation results, then monitor it after deployment. A threshold is only as dependable as the population on which its calibration was established.
For zero-shot systems specifically, Silva-Rodriguez and colleagues study conformal prediction and calibration scores in Conformal Prediction for Zero-Shot Models (CVPR 2025). Their work includes an unsupervised, transductive transfer strategy for conformal prediction, illustrating that a zero-shot workflow can use information from the target inputs without ordinary task-specific labeled training. The strategy does not make every raw confidence score universally calibrated; it addresses a different uncertainty objective.
Calibration and conformal prediction are different tools
Calibration adjusts or assesses probability scores. Conformal prediction constructs a set of candidate labels intended to contain the correct label at a user-specified rate under the method’s assumptions. One produces probabilities; the other produces sets and a coverage target.
| Question | Probability calibration | Conformal prediction |
|---|---|---|
| Primary target | Whether confidence values match empirical correctness frequencies | Whether prediction sets achieve a chosen coverage level |
| Typical output | Adjusted probabilities or a calibrated confidence score | A set of one or more candidate labels, sometimes including abstention behavior |
| Data requirement | Often held-out labeled examples for post-hoc fitting; some alternatives use other information | Calibration or transfer data that satisfy the procedure’s assumptions; the exact requirement depends on the method |
| Guarantee scope | No automatic guarantee under distribution shift | Generally marginal coverage under the relevant assumptions, not guaranteed coverage separately for every class |
| Main efficiency question | How close confidence is to observed correctness | How often the set covers the answer and how large the set is |
Dabah and Tirer explain this distinction in On Temperature Scaling and Conformal Prediction of Deep Classifiers (ICML 2025). Marginal coverage means the stated frequency applies across the evaluation population covered by the assumptions. It should not be described as a per-class guarantee unless a specific method establishes that stronger property.

How the outputs affect a product decision
If an application must decide whether to trust one label, a calibrated probability can support a threshold, provided the evaluation population matches deployment. If the application can present several plausible labels or send ambiguous cases for review, a conformal set may be more appropriate. A set containing many labels may satisfy coverage while being operationally unhelpful, so set size and abstention behavior must be measured alongside coverage.
Independent reader supportYour contribution helps us test, update, and keep practical guides available for everyone. Why better calibration can produce larger conformal sets
It is tempting to assume that making probabilities more reliable will automatically make conformal prediction more efficient. The evidence does not support that as a general rule. Xi and colleagues report in Does confidence calibration improve conformal prediction? (2024) that common confidence-calibration methods, including temperature scaling, typically produced larger adaptive conformal prediction sets in the settings they studied.
The result is a context-dependent trade-off, not a contradiction. Calibration can flatten an overconfident distribution so that several labels receive non-negligible scores. An adaptive conformal rule may then include more labels to meet its coverage target. The calibrated probabilities may better represent uncertainty even while the resulting set becomes less compact.
Evaluate both objectives separately: probability reliability and conformal efficiency. Do not select a calibration method solely because it lowers a calibration error measure, and do not reject it solely because a particular conformal set grew in one experiment.
Choosing an approach for your zero-shot system
| Your situation | Most relevant first step | What to verify |
|---|---|---|
| You have representative labeled examples and need a usable probability threshold | Measure baseline reliability, then test temperature scaling on a held-out calibration split | Reliability at the operating threshold, accuracy preservation and performance on an untouched evaluation set |
| You have no target-task labels but need uncertainty information | Keep raw scores explicitly uncalibrated and investigate a method whose assumptions permit unlabeled or transferred data | What information the method uses, whether its assumptions fit the target inputs and whether the output is a probability or a set |
| You must guarantee a chosen population-level coverage rate | Use a conformal procedure designed for the zero-shot setting | Marginal coverage assumptions, calibration-data validity and resulting set size |
| You need fair reliability across classes or groups | Evaluate calibration by class and relevant subgroup rather than relying on one aggregate score | Whether the method offers only marginal behavior or a stronger class-conditional objective |
| Your inputs will drift over time | Monitor confidence and correctness after deployment and schedule recalibration when the population changes | Changes in class mix, domains, prompts, model versions and threshold outcomes |
Common mistakes and how to correct them
Calling a raw score a probability
Softmax outputs always sum to one, but that arithmetic does not prove that a value such as 0.9 corresponds to a 90 percent correctness frequency. Label the score as uncalibrated until representative evaluation supports a probability interpretation.
Best Value
Confusing calibration with accuracy
A calibration adjustment can leave every top-ranked label unchanged. Report accuracy and calibration separately; an improvement in one does not imply an improvement in the other.
Fitting temperature on the test set
Using final evaluation examples to learn the temperature leaks information into the result. Fit on a dedicated calibration split and reserve a separate set for the reported check.
Assuming zero-shot means no calibration data are allowed
Zero-shot describes the absence of task-specific labeled training examples for prediction. A post-hoc procedure may still use labeled calibration examples, while other methods may transfer information from unlabeled target inputs. State exactly which data were used.
Turning marginal conformal coverage into a per-class promise
Unless the chosen conformal method proves class-conditional coverage, describe its guarantee as marginal. A model can meet aggregate coverage while covering some classes less often than others.
Expecting calibration to shrink every prediction set
Set size is a separate efficiency measure. The 2024 adaptive-conformal results above show why a calibration method can improve probability interpretation yet enlarge sets in the tested settings.
Ignoring deployment shift
Calibration is an empirical relationship, not a permanent property of a model. Recheck it when prompts, label names, input sources, class prevalence or model versions change.
A compact implementation checklist
- Write down the exact zero-shot labels, prompt and model version.
- Define whether the output will be a probability threshold, ranking, abstention decision or prediction set.
- Use evaluation data that represent the intended deployment population.
- Keep calibration data separate from final evaluation data.
- Compare confidence with observed correctness in bins, not just with overall accuracy.
- Use temperature scaling as a baseline only when its labeled-data requirement is met.
- For conformal prediction, document the target coverage, assumptions and whether the guarantee is marginal.
- Measure prediction-set size when using conformal methods.
- Check important classes and subgroups separately.
- Monitor for distribution changes and recalibrate or reassess when they occur.
Bottom line
In zero-shot machine learning, calibration means making confidence scores correspond to observed correctness frequencies—or testing whether they already do. It is not the same as accuracy, and zero-shot status does not make scores trustworthy by default. Temperature scaling is a useful labeled-data baseline that changes probability concentration while preserving ranking. Conformal prediction addresses a different goal by producing sets with generally marginal coverage. Choose between them, or combine them, according to the decision you need to support, the data you can access and the assumptions that remain valid in deployment.
