AI can help developers find and propose performance improvements, but a plausible code change is not proof that software got faster. A useful optimization must preserve behavior and deliver repeatable gains on representative workloads. Early work such as Microsoft Research’s DeepPERF showed that models could reproduce some developer fixes; newer repository-scale evaluations show that consistently improving real projects remains difficult.
How could AI change software performance work?
Performance engineering is a cycle: identify a bottleneck, form a change, verify that behavior is preserved, and measure the result. AI can assist at several points. It can suggest candidate code changes, help developers reason about likely bottlenecks, and make it easier to explore alternatives. The important shift is not that measurement becomes unnecessary, but that generating and testing candidate optimizations may become more automated.

Microsoft Research’s 2022 DeepPERF work is an early example. It evaluated performance-improvement suggestions for 50 open-source C# repositories. In an expert-verified dataset, the system generated the same suggestion as a developer fix in approximately 53% of cases and produced suggestions verbatim in approximately 34%. The authors also reported 19 submitted pull requests containing 28 performance optimizations, 11 of which project owners had approved at the time of publication. Those results demonstrate promising suggestions and real project engagement, not a general guarantee of speedups across software.
As the DeepPERF authors put it, “Improving software performance is an important yet challenging part of the software development cycle.” Microsoft Research’s DeepPERF publication page describes the work and its results.

Why is it hard to prove that an AI optimization works?
A patch must preserve correctness
A change can compile and still alter behavior. Tests and other correctness checks must establish that the optimized version produces the required results for relevant inputs. Correctness is a separate requirement from performance: a correct patch may be neutral or slower, while a fast patch that changes required behavior is not a valid optimization.
Performance has more than one dimension
Runtime is only part of the picture. Memory use can change even when execution time does not, and a result that looks favorable for one input may reverse for another. At a minimum, evaluate runtime and memory; where the use case warrants it, examine peak memory and time-weighted memory use as distinct measures.

Workloads and measurement conditions matter
Input sizes, input distributions, and execution conditions affect results. Repeated measurements help distinguish an actual change from noise. A credible evaluation should test varied, representative workloads and make the conditions clear rather than relying on one favorable run.

What do current evaluations say about AI optimization?
Results depend on the task and evaluation design, so the available studies do not support a blanket claim that AI either can or cannot optimize software reliably.

The 2026 SWE-Pro preprint evaluates repository-level optimization tasks using 102 expert-written optimizations drawn from open-source projects. Its authors report that expert implementations achieved an aggregate runtime speedup of 15.48× and an aggregate peak-memory reduction of 171.31× in that benchmark. Experts improved runtime in 91.2% of tasks and achieved reliable peak-memory gains in 65.7%. These are benchmark findings, not expected gains for arbitrary production systems.
In contrast to those expert results, SWE-Pro reports negligible runtime gains and almost no memory optimization from current LLMs in its repository-level evaluation. Its framework measures runtime, peak memory, and time-weighted memory use under parameterized conditions. The findings underscore the gap between proposing a plausible change and reliably finding one that performs well across a project’s requirements. They should be read as results from this preprint’s benchmark, not as a verdict on every model, language, or workload. See the SWE-Pro preprint for its setup and results.

A separate 2026 empirical study examined 324 agent-generated and 83 human-authored performance pull requests. Explicit performance validation appeared in 45.7% of the AI-authored pull requests and 63.6% of the human-authored ones; the reported difference had p = 0.007. This is evidence about validation practice in the pull requests studied. It does not establish that agents are inherently incapable of validating changes. The study is titled “How Do Agents Perform Code Optimization? An Empirical Study.”

How should you compare AI-generated performance changes?
Keep the comparison tied to the same task and conditions. Include the unmodified implementation, compiler or other conventional baseline where relevant, and an expert-written change when the evaluation provides one. Record what changed, how it was measured, and which inputs and environments were used.
| What to compare | What it tells you |
|---|---|
| Functional correctness | Whether the patch preserves required behavior. |
| Runtime | Whether execution time changes, and whether that change repeats across runs. |
| Peak and time-weighted memory | Whether memory use improves, including both the high-water mark and its behavior over time. |
| Inputs and conditions | Whether results hold across relevant input sizes, distributions, and execution environments. |
| Validation method | Whether the claimed gain is supported by profiling and repeatable benchmarking rather than intuition alone. |
| Task scope | Whether the evidence concerns an isolated function or an optimization that must work across a repository. |
Where is the opportunity?
The strongest opportunity is to make optimization exploration more efficient without mistaking code generation for engineering success. AI can produce candidates and help developers investigate performance, but profiling identifies where work is being spent, correctness checks protect behavior, and workload-specific repeated benchmarks determine whether a change is actually an improvement.
Evidence from different benchmark designs points in different directions: DeepPERF showed that generated suggestions could match developer fixes in some C# cases, while SWE-Pro found that current LLMs struggled to deliver measurable repository-level gains against expert implementations. These results are not directly comparable, but together they clarify the challenge: reliably choosing the right change and validating its effects remains central to making AI useful for software performance.
