For most payment businesses, a measured hybrid is the safest starting point: use explicit rules for hard constraints and known fraud patterns, then apply machine-learning scores to add behavioral and historical context. Set the action threshold using your real fraud losses, false-decline costs and customer value, and continuously validate the outcome.
Neither approach is automatically better. Rules are transparent and quick to change, while machine learning can recognize combinations of signals that no fixed condition captures. The right design depends on your data, fraud pattern, risk tolerance, payment mix and ability to monitor decisions.

What the two approaches actually do
Rules-based detection
A rules engine evaluates human-authored conditions such as transaction amount, purchase frequency, country, device or a known allowlist or blocklist. A rule might send a transaction for review when several orders arrive from one account in a short period, or block a card used from a location on a denylist.

The result is easy to inspect: an analyst can usually identify the condition that fired and change it without retraining a model. Rules can therefore enforce a business policy directly, including limits required by a payment method, market or internal control.

The weakness is that attackers can adapt around visible thresholds. A growing rule set also needs maintenance, testing and conflict resolution. A rule that is perfectly legible can still create expensive false declines if it blocks legitimate customers.
Machine-learning detection
A machine-learning system learns statistical relationships from historical transactions and outcomes. Depending on the implementation, features can include payment history, account behavior, device and network signals, geolocation, velocity and links between apparently separate identities.
Instead of returning only “allow” or “block,” the model commonly produces a risk score or classification. That score can rank transactions for approval, review or rejection. It may detect a combination of weak signals that does not match any single fixed rule.

Outbyte PC Repair FREERepair Windows errors before they cause bigger problemsFix Now →Outbyte Driver Updater FREEFix the driver behind crashes, sound loss and screen glitchesFind Drivers →Flexibility comes with obligations. The business needs suitable, representative data; reliable labels; validation for false positives and false negatives; controls for privacy, security and bias; explanations that reviewers can use; and monitoring as customer behavior and attack tactics change. A score is not a policy by itself: your threshold determines the commercial effect.
Rules versus machine learning at a glance
| Decision factor | Rules-based system | Machine-learning scoring |
|---|---|---|
| Primary mechanism | Human-authored conditions and lists | Patterns inferred from historical and behavioral data |
| Explainability | Usually direct: the triggered condition is visible | Requires score explanations and governance; complex or unsupervised methods can be harder to explain |
| Change speed | Immediate targeted edits are possible | Changing behavior may require recalibration, retraining or a policy change |
| Data requirement | Can operate with little reliable labeled history | Needs suitable, representative data and outcome labels |
| Adaptability | Known thresholds can be evaded and rule sets grow over time | Can use context across behavior, history and networks, but still needs monitoring for drift |
| Policy enforcement | Strong for explicit constraints and domain exceptions | Produces evidence for a decision; the business policy remains separate |
| Operational burden | Rule design, conflict handling and ongoing maintenance | Data quality, validation, fairness, security, explanation, monitoring and delayed-label management |
| Best fit | Stable, understood fraud patterns or mandatory conditions | Varied or shifting patterns with adequate transaction history |
When rules are the better first choice
Favor explicit rules when the organization can describe the risk condition clearly and needs an immediate, auditable control.
- Patterns are known and stable. If a particular country, account state or transaction sequence is consistently problematic, a targeted rule can address it directly.
- Reliable labels are scarce. A new payment operation may not yet have enough confirmed fraud outcomes to train or evaluate a model responsibly.
- Policy requires a clear condition. Rules can encode limits, prohibited combinations or approved exceptions that must be applied consistently.
- The team needs a rapid response. During a new attack pattern, an analyst can add a narrow rule while a longer-term model change is evaluated.
- Explainability is the immediate priority. Reviewers, customers or internal auditors can see which condition caused an action.
Do not confuse transparency with safety. Monitor approval rates, confirmed fraud and customer complaints after every significant rule change. A simple amount or geography threshold can reject legitimate high-value purchases, travelers or cross-border customers.
When machine-learning scoring earns its complexity
Add machine-learning scoring when you have enough relevant data and the fraud problem is too varied or dynamic for a manageable list of conditions.

- Transaction history is substantial and representative. The training and validation data should reflect the channels, payment methods, regions and customer segments where the model will operate.
- Signals interact in complicated ways. A model can combine behavior, device, network and historical context rather than waiting for one rule to match.
- Attack tactics shift. Scoring can help identify new combinations, provided the organization detects drift and updates the system.
- The business can investigate outcomes. Someone must review questionable decisions, confirm labels and respond when the model behaves unexpectedly.
- False positives and false negatives can be measured. A model should be evaluated at the operating threshold the business will actually use, not only with a headline metric.
A model should not be deployed simply because it is more sophisticated. If labels are delayed, biased or incomplete, apparent accuracy can be misleading. If no one can explain or monitor its decisions, the added flexibility may create more operational risk than it removes.
Why a hybrid design is usually practical
A hybrid separates broad risk ranking from non-negotiable business controls. The model supplies context; rules impose hard constraints, exceptions and locally understood signals.
A typical decision flow
- Collect permitted signals. Assemble transaction, account, device, network, payment-method and geographic data that the business is entitled to use.
- Apply deterministic controls. Enforce mandatory limits, known denylist conditions, allowlisted partners and domain-specific exceptions.
- Calculate a model score. The machine-learning system evaluates the remaining transaction and returns a risk score or classification.
- Map score to an action. Use separate thresholds or bands for automatic approval, manual review and blocking.
- Record the decision context. Retain the rule outcomes, score, threshold version, action and relevant evidence for investigation and later evaluation.
- Feed confirmed outcomes back. Once fraud or legitimacy is established, update labels and reassess both the rules and model policy.
Provider documentation illustrates this pattern. Adyen describes custom rules that complement its machine-learning fraud risk rule, with tooling for backtesting and experiments. That capability is an example of the architecture, not proof that one provider outperforms another.
Thresholds determine the business result
Suppose a model returns a continuous risk score. The blocking threshold is the point at which the business refuses a payment; it is not a universal measure of model quality.
Stripe’s technical guidance describes the central trade-off: raising the blocking threshold tends to increase precision among blocked payments while decreasing recall, meaning fewer fraudulent transactions are caught. Lowering it generally catches more fraud but also sends more legitimate payments into decline or review. No single threshold maximizes precision, recall, approval rate and customer experience simultaneously.
Use a cost-based operating point
Estimate the expected cost of each action for the specific business, payment method, region and customer segment:
- Direct fraud loss and chargeback expense when a fraudulent payment is approved.
- Operational cost of manual review, investigation and customer support.
- Revenue and contribution margin lost when a legitimate payment is declined.
- Potential lifetime-value loss when a false decline causes a customer to leave.
- Customer friction introduced by additional authentication or review.
Adyen gives two illustrative economic cases. A merchant with thin margins and high operational fraud costs may rationally block at a lower risk level. A seller of mostly digital goods may prefer a higher threshold when the lifetime value lost from a false decline exceeds the cost of an individual fraud case. These are examples, not universal prescriptions; calculate your own figures.

Use distinct actions, not only block or allow
A three-way policy often makes the trade-off manageable: approve low-risk transactions, send an intermediate band to review or additional verification, and block the highest-risk transactions. Set capacity limits for the review queue so the policy does not create an unworkable workload.
Do these 3 things before closing this tab:
1Clear out junk files and repair common Windows errors2Scan for outdated or missing drivers - takes under a minute3Repair Windows errors before they cause bigger problemsHow to evaluate either approach
Measure the detector and the policy together. A model-wide score can look strong while the chosen threshold damages approval or creates excessive review work.
| Measure | What it tells you | Required qualification |
|---|---|---|
| Precision | How many transactions identified as fraudulent are actually fraud | Report at the action threshold in production |
| Recall | How much of the confirmed fraud the system catches | Define the fraud-outcome window, because labels may arrive after payment |
| False-positive rate | How often legitimate transactions are treated as fraud | Break out declines, reviews and authentication challenges |
| Approval or conversion rate | Commercial effect on legitimate payment completion | Compare with a controlled baseline or experiment |
| Fraud and chargeback loss | Actual financial damage that remains | Include payment-method and region differences |
| Review workload | Analyst capacity consumed by the policy | Track queue size, handling time and escalation quality |
| Customer friction | Effect of declines, verification and support contacts | Segment by customer type and journey stage |
Build a valid offline evaluation
- Separate training records from held-out validation examples; do not measure only on the data used to fit the model.
- Preserve the time order where practical so the test resembles deployment on future transactions.
- Define when a transaction receives a confirmed fraud or legitimate label. Delayed chargebacks and investigations must be included in the outcome window.
- Replay the actual rules, score bands and threshold on the held-out set.
- Report precision, recall and false-positive rate alongside fraud loss, false-decline cost, approval rate and review volume.
- Examine results by payment method, geography, device, customer tenure and other material segments to find uneven error rates.
Offline results are not a permanent guarantee. In production, monitor score distributions, confirmed outcomes and the policy’s effect on approvals, declines and review demand. Reassess when products, markets, payment methods or attacker behavior change.
Data, governance and security requirements
Fraud systems can use sensitive personal and geolocation information. OECD’s Business and Finance Outlook 2021 fraud-detection lifecycle analysis emphasizes data quality, privacy, security, bias, explainability, human involvement, validation, adversarial testing, compatibility and monitoring. It states: “It is thus necessary to verify the accuracy and performance of the system against false positives and false negatives.”
Questions to answer before deployment
- Which fields are collected, for what purpose, and under which retention and access controls?
- Are training examples representative of the customers and payment methods that will be scored?
- Who can override a rule or model decision, and what evidence must that person record?
- How will customers challenge a decline or provide additional verification?
- How will adversarial testing probe attempts to manipulate device, location or account signals?
- How will you detect performance degradation, segment disparities and data-pipeline failures?
- What is the rollback, replacement or retirement process if the system becomes unreliable?
Applicable legal requirements depend on jurisdiction and on whether you are a merchant, payment service provider, processor or another participant. Obtain advice for the markets in which you operate rather than assuming that one governance process fits every region.

A procurement and build checklist
Ask every provider or internal engineering team to demonstrate the same decision path on representative historical data.
- Coverage: Which channels, regions, currencies and payment methods are supported?
- Signals: What transaction, account, device, network and behavioral data can be used, and what arrives in real time?
- Control precedence: Do custom rules override, supplement or get overridden by model scores?
- Thresholds: Can you set separate approve, review and block bands and change them without a full deployment?
- Explanations: Can analysts see the signals or rules that influenced a decision?
- Testing: Are there backtests, holdout evaluation, shadow mode, experiments and rollback tools?
- Operations: Is case management available, and can reviewers record outcomes and reasons?
- Monitoring: Can you track score drift, confirmed fraud, false declines, approval rate and workload by segment?
- Data handling: What are the retention, access, security and deletion controls?
- Integration: What latency, APIs, webhooks, payment-method constraints and engineering work are involved?
- Total cost: Include subscription or transaction fees, implementation, review labor, chargebacks and lost legitimate sales.
Common failure modes and fixes
A rule set that grows without control
Symptom: overlapping rules produce contradictory actions and no one knows which condition is authoritative.
Fix: assign owners, version every change, define precedence, test interactions and retire rules whose outcomes are no longer supported by evidence.
Optimizing only for fraud caught
Symptom: recall rises while approval falls and legitimate customers complain.
Quick wins for a faster PC:
Fix the driver behind crashes, sound loss and screen glitchesFind Drivers →Repair Windows errors before they cause bigger problemsFix Now →Scan for outdated or missing drivers - takes under a minuteDriver Scan →Fix: choose thresholds using fraud loss, false-decline cost, lifetime value and review capacity; report precision and false-positive rate at that threshold.
Best Value
Trusting a model score as an automatic decision
Symptom: the organization cannot explain why a score caused a decline or what economic trade-off it represents.
Fix: document score bands, actions, overrides and escalation paths as a separate policy layer.
Training on incomplete or delayed labels
Symptom: early evaluation looks positive, then chargebacks and investigations reveal additional fraud.
Fix: define an outcome window, hold out validation data, allow labels to mature and revisit historical cohorts as outcomes arrive.
Ignoring drift and segment harm
Symptom: performance changes after a market, device mix or attack pattern changes, or one customer segment experiences disproportionate declines.
Fix: monitor distributions and outcomes by material segment, investigate data-pipeline changes, run adversarial tests and recalibrate or roll back when necessary.
Bottom line: choose the control you can operate
Use rules when conditions are clear, data is limited or policy must be explicit. Add machine-learning scoring when you have representative history, shifting patterns and the staff and controls to validate and monitor it. For many payment businesses, combining both provides the most practical balance: deterministic controls for certainty, contextual scoring for ranking, and a threshold set by the economics of fraud and false declines.
