Robot Foundation Models vs. Traditional Robotics Software: What’s Different?

Robot foundation models learn broad visual, language and action patterns, while traditional robotics software assembles explicitly engineered modules for sensing, planning, kinematics and control. The practical difference is not that one replaces the other. A model such as Google DeepMind’s RT-2 can interpret a camera view and a natural-language instruction, then propose an action; conventional middleware, inverse-kinematics solvers, controllers and hardware interfaces may still be required to turn that proposal into safe motion.

Published results show why the distinction matters: in a specific evaluation of more than 6,000 trials, RT-2 improved performance on novel unseen scenarios from 32% to 62% while performing similarly to RT-1 on seen tasks. Open X-Embodiment experiments also reported gains from pooling demonstrations across robot types. Those figures describe particular models, data and benchmarks—not a universal advantage, safety guarantee or replacement for a classical stack.

What the two approaches mean

Robot foundation models

A robot foundation model is a learned model trained on broad data with the intention of transferring knowledge across tasks, objects or environments. In a vision-language-action (VLA) system, camera images and language context are processed together to predict robot actions. The model can use visual and linguistic concepts acquired before it ever sees a particular robot demonstration, then adapt those representations to physical behavior through additional robotics data.

RT-2 is a concrete example rather than a definition of every foundation model. Google DeepMind describes it as combining a pretrained vision-language model with robot demonstration data. Its output is tokenized: tokens encode whether the action sequence should continue or terminate, end-effector position and rotation, and gripper state. That design lets learned representations connect concepts such as an object’s appearance or a verbal instruction to an action without a separately hand-written rule for every concept.

Traditional robotics software

Traditional software usually divides the robot into specialized components. Sensors publish observations; perception software detects or estimates objects and robot state; planners select paths or actions; kinematics converts between coordinate systems and joint configurations; controllers command motors; and hardware interfaces communicate with the robot. Middleware provides message passing, tools, diagnostics and a common development ecosystem.

These components are explicit and inspectable. Engineers can set limits, define coordinate frames, select planners and tune control loops for a known robot and task. A traditional system may still contain machine-learning perception or optimization, but its behavior is organized around engineered interfaces and task-specific modules rather than one broadly pretrained policy.

How an action reaches a real robot

The distinction becomes clearer when following one command through a complete system. Suppose an operator says, “Pick up the red cup and place it on the tray.”

  1. Observation: Cameras, force sensors and joint encoders produce images and state measurements.
  2. Interpretation: A foundation model may combine the image with the language instruction and infer which object and goal are intended. A classical system might pass the image to a detector whose output is matched to a predefined task.
  3. Action proposal: A VLA can emit a sequence of tokens representing an end-effector pose, orientation, gripper command and termination state. A traditional planner may instead generate a trajectory from an object pose and a set of task rules.
  4. Geometric conversion: The proposed end-effector pose normally has to be converted into joint positions or velocities. Inverse kinematics, collision checking and trajectory generation can perform this conversion.
  5. Control and interface: A controller tracks the trajectory while middleware transports commands to the robot, reports errors and enforces operating limits.
  6. Validation: A supervisory layer can reject an action outside workspace, speed, force or collision constraints, or stop the robot when sensors detect an unsafe condition.

This is why “learned” and “traditional” are not mutually exclusive categories. The Open Source Robotics Alliance’s Physical AI SIG describes learned policies, existing skills and classical components coexisting in an agent system. Its summary is apt: “These techniques are different ways to approach the traditional sense-think-act pipeline, but what has not changed is how we interact with these systems.”

What changes when broad pretraining is added

Generalization to unfamiliar situations

Hand-built software normally generalizes only where its rules, models and planners cover the situation. A detector trained for a fixed set of objects may fail when lighting, backgrounds, object shapes or task wording change. Engineers can add cases, retrain a component or redesign the task representation, but each extension requires work.

A foundation model starts with representations learned from broad visual and language data. It may recognize concepts, relationships or instructions that were not explicitly programmed for one robot. RT-2’s reported evaluation illustrates the potential: across more than 6,000 robotic trials, it performed similarly to RT-1 on seen tasks while raising success on novel unseen scenarios from 32% to 62%.

The result should be read narrowly. “Novel” referred to the scenarios and benchmark used in that RT-2 study. The number does not establish that every foundation model will generalize to every unfamiliar object, environment or manipulation skill, nor that it will remain reliable under distribution shifts absent from the test.

Training data and the source of capability

Traditional systems derive most of their capability from engineering artifacts: robot descriptions, calibration, maps, grasp rules, motion planners, task graphs and controller parameters. Demonstration data may be used, but it is usually collected for a defined task and embodiment.

RT-2 combines two kinds of data. A pretrained vision-language model contributes broad web-scale visual and language knowledge, while robot demonstrations teach the model how concepts can be expressed as physical actions. This combination can reduce the need to create a separate mapping for every new visual or linguistic concept, but it does not remove the need for high-quality robot data, suitable action representations and evaluation.

Data quality also creates a different engineering burden. Demonstrations must be recorded consistently, synchronized with observations and actions, and labeled or represented in a form the training pipeline can use. The Physical AI SIG lists data collection consistency as a continuing practical challenge.

Emergent skills and transfer

Foundation-model evaluations sometimes test behaviors that were not directly demonstrated in the same form, such as applying a learned visual or language concept to a physical task. Google DeepMind reported RT-2’s improvement on its emergent-skill and novel-scenario evaluations, but those tests remain tied to the model, prompts, robots and protocols used.

Traditional software can also transfer abstractions. A planner, coordinate-frame convention or controller can be reused across tasks once the robot model and interfaces are configured. Its transfer is usually explicit: engineers define the reusable skill and its preconditions. A learned model may discover a broader statistical relationship, but its internal reasoning is harder to inspect and its failure boundaries may be less obvious.

Embodiment transfer: can one robot’s data help another?

Robots differ in arm geometry, joint limits, sensors, grippers, control frequencies and coordinate frames. A policy that emits raw joint commands for one machine generally cannot be copied directly to another.

Open X-Embodiment explored pooling demonstrations across 22 robot types. In a five-lab evaluation, Google DeepMind reported that RT-1-X achieved an average success rate 50% higher than corresponding methods developed for individual robots. The same work reported RT-2-X at three times RT-2’s performance on its emergent-skill evaluation.

Those are cross-embodiment experiments, not proof of universal compatibility. Transfer depends on how data describe actions, how embodiments are represented, whether the target robot has the required degrees of freedom and sensors, and how outputs are adapted to its control interface. A shared action representation can help, but calibration, safety limits and robot-specific execution software remain necessary.

Embodiment transfer Can benefit from pooled multi-robot data when action and embodiment representations support it Reusable components require explicit adaptation to each robot’s geometry and interfaces
Interpretability High-level outputs can be difficult to explain or trace to a single rule Module boundaries, parameters and constraints are generally inspectable
Execution path Still commonly depends on middleware, inverse kinematics, trajectory generation and controllers Provides those execution components directly
Main scaling cost Data curation, training or inference infrastructure, validation and integration Engineering time for each task, robot, environment and edge case

Latency concerns Model inference and tensor movement can challenge control-cycle timing Established real-time controllers can run predictable loops; added perception or planning still has timing limits

What traditional software still contributes

Middleware and communication

ROS is described by the Open Source Robotics Alliance as middleware, tools and a shared ecosystem for robot development. Middleware connects sensors, planners, controllers and user interfaces, exposes standardized messages and supports diagnostics. A learned policy does not automatically provide these capabilities.

Kinematics and task-space control

A model can predict a desired end-effector pose, but the robot still needs a way to realize it. Inverse kinematics finds joint configurations that correspond to the pose, subject to joint limits and configuration choices. Task-space controllers can track position and orientation while respecting the robot’s physical constraints. Collision checking and trajectory generation can reject or reshape an otherwise plausible proposal.

Robot and scene representations

Software must describe links, joints, sensors, frames, workspaces, obstacles and objects in formats that both robotics tools and AI systems can consume. Converting between a model’s token or tensor representation and the robot’s operational scene is a substantial integration task.

Deterministic control and fault handling

Motor control, emergency stops, watchdogs, limit enforcement and recovery behavior need bounded, testable behavior. A foundation model can suggest what to do next, but a lower-level controller should continue to enforce speed, torque, workspace and collision constraints. If inference fails or becomes unavailable, the system needs a defined fallback rather than an implicit assumption that the model will recover.

Deployment challenges that are easy to underestimate

Latency and data movement

Physical AI SIG guidance highlights the need to move large tensors efficiently between processes and run inference with low latency. A model may be accurate enough in an offline test yet too slow for a moving robot, or its image and state data may arrive too late to support a stable control decision. Architects must decide which functions run on the robot, on an edge computer or remotely, and what happens when a connection or accelerator is unavailable.

Action validation

Every predicted action needs checks appropriate to the hardware and task. Examples include workspace and joint-limit checks, collision tests, velocity and force bounds, gripper-state validation and confirmation that the intended object is still visible. Validation can be implemented as a gate before execution, a monitor during motion or both. It should be tested against malformed, stale and out-of-distribution outputs rather than only normal predictions.

Data and dependency management

Training data, robot descriptions, calibration files, model versions, inference runtimes and robotics libraries must remain compatible. The SIG identifies the difficulty of making robotics and machine-learning dependencies work together. Updating a model can alter output distributions; updating a controller can change how those outputs behave. Versioning and regression tests are therefore part of the deployment design, not administrative extras.

Human-centered operation

RT-2’s authors described the results as promising while acknowledging that much work remains for helpful robots in human-centered environments. Human spaces introduce occlusion, changing goals, ambiguous language, unexpected contact and the need for understandable failure behavior. A benchmark gain does not establish universal reliability, safety certification or production readiness.

How to choose an architecture

Use a more classical design when the task is narrow and highly constrained

  • The workspace, objects and motions are tightly specified.
  • Requirements demand deterministic timing and straightforward validation.
  • There is little representative training data but strong geometric knowledge.
  • Every action can be expressed with stable rules, planners and controllers.

A classical stack may be easier to test and certify for a fixed cell, especially when predictable behavior matters more than adapting to varied language or objects.

Add a foundation model when interpretation or variation is the bottleneck

  • Operators need natural-language task descriptions.
  • Objects, backgrounds or arrangements vary beyond practical hand-coding.
  • Existing demonstrations span related tasks or multiple robot embodiments.
  • Perception and task selection, rather than low-level control, consume most engineering effort.

In these cases, put the model at the level where its flexibility is useful—such as instruction interpretation, object selection or task-level action proposals—and retain conventional execution and safety layers.

Use a hybrid by default for physical deployment

A practical hybrid separates responsibilities. The foundation model handles semantic interpretation and proposes actions. Robotics software converts those proposals into feasible trajectories, communicates with hardware, monitors state and applies hard limits. This arrangement preserves a path to reuse while keeping the parts that require predictable timing and safety under explicit control.

A step-by-step integration plan

  1. Define the action contract. Specify whether the model emits discrete skills, end-effector poses, velocities, waypoints or another representation. Include units, coordinate frames, timestamps, termination signals and gripper states.
  2. Inventory the embodiment. Record joints, limits, payload, end effector, cameras, force sensors, control rates and reachable workspace. Identify which model outputs the robot cannot physically execute.
  3. Build the classical execution path first. Confirm that middleware, robot descriptions, inverse kinematics, trajectory generation, controllers, emergency stops and diagnostics work without the learned policy.
  4. Insert the model behind a bounded interface. Convert sensor streams into the model’s expected inputs and expose only the action fields the downstream stack can validate.
  5. Add a validation gate. Reject stale, malformed or physically infeasible outputs. Apply collision, workspace, velocity, force and object-state checks before motion.
  6. Test in simulation or replay. Evaluate seen and deliberately unfamiliar objects, lighting, backgrounds, language variations and sensor failures. Compare model proposals with safe fallbacks.
  7. Run constrained physical trials. Start at reduced speed and energy with a reachable emergency stop and a supervisor. Log observations, outputs, validation decisions and controller behavior.
  8. Measure the deployment, not just the model. Track task success, recovery rate, end-to-end latency, dropped frames, intervention frequency and unsafe-action rejections. A model score alone cannot describe system performance.
  9. Version and monitor. Pin model, runtime, robot description and controller versions. Re-run regression tests after changes and monitor for drift in scenes, language, hardware or data quality.

How to read the published numbers

The RT-2 result of 32% to 62% concerns novel unseen scenarios in the reported evaluation and came from more than 6,000 robotic trials; it should not be translated into a general 30-point improvement for all robots. The RT-1-X result is an average 50% success-rate improvement over corresponding individual-robot methods in a five-lab evaluation across commonly used robots. The RT-2-X result—three times RT-2 performance—refers to its emergent-skill evaluation. Each figure depends on the task suite, baselines, data and measurement protocol.

No cited source establishes a universal cost advantage, latency advantage, reliability guarantee or production-readiness threshold for foundation models over traditional software. Costs vary with data collection, compute, model size, sensors, robot hardware, engineering and operational safeguards; a comparable price or total-cost figure is not stated in the reported evidence.

Bottom line for engineering teams

Foundation models change where capability can come from: broad pretraining and pooled robot demonstrations can connect language and visual concepts to action and may improve transfer to unfamiliar scenarios or embodiments. Traditional robotics software remains the machinery that describes the robot, computes feasible motion, communicates with hardware, controls actuators and enforces limits. The strongest current design is usually compositional rather than ideological—a learned policy for flexible interpretation and proposals, surrounded by conventional middleware, kinematics, control, monitoring and safety validation.
