A mostly synthetic approach is defensible when the simulator reproduces the task structure and its transfer methods are validated. A mostly real approach is safer when deployment fidelity, contact mechanics, human interaction, or site-specific variation matter more than throughput.
What the two data sources actually provide
Synthetic data is generated by a simulator or rendering system. It can include images, depth, segmentation masks, object poses, robot state, actions, rewards, and full ground-truth trajectories. Because the simulator controls the scene, it can produce unusual poses, rare failures, and millions of parallel rollouts without occupying a physical robot.

Real-world data comes from the robot, its sensors, its workspace, and the people or systems operating it. Demonstrations may be teleoperated, scripted, or collected from an already trained policy. Labels can be produced by calibration, human annotation, replay logs, or post-processing. Real records contain the deployed camera latency, actuator backlash, friction, compliance, lighting, object wear, and timing irregularities that a simulator may miss.
Recommended Free Tools
The choice is therefore not simply “cheap data versus expensive data.” It is a trade-off between scale and controllability on one side and physical fidelity on the other. Training only on the source that is easiest to collect can leave the most important deployment failures unobserved.

Where synthetic data is the better starting point
When labels or demonstrations are expensive
A simulator can emit exact labels for every frame and state. There is no separate annotation pass for object masks, keypoints, collision status, or success. This is especially valuable for perception systems whose labels would otherwise require careful human work or specialized instrumentation.
When you need parallel experience
Simulation can run many environments concurrently and reset them immediately after a failure. That makes it practical to explore policies, randomize scenes, and collect long-horizon trajectories without waiting for a robot to move, recharge, or be made safe. Parallel rollouts are also useful for reinforcement learning, where millions of action transitions may be needed.
When exploration could damage hardware
Unstable policies, collisions, high forces, and unsafe recovery behavior can be tested in software first. Simulation does not remove the need for hardware safeguards, but it moves much of the trial-and-error phase away from people and machines.
When coverage matters more than exact realism
Rendering systems can vary lighting, textures, camera parameters, object geometry, pose, clutter, and backgrounds systematically. You can deliberately oversample rare arrangements or failure conditions that may be difficult to encounter during ordinary operation.
When the task structure is well modeled
Mostly synthetic training is most credible for tasks with geometry and dynamics that can be represented adequately, such as many visual detection, reaching, navigation, and some pushing problems. The simulator still needs validation on the target robot; a visually convincing scene is not evidence that friction, latency, compliance, or actuator limits are correct.
Where real-world data is indispensable
Contact, compliance, and friction dominate success
Grasping deformable objects, inserting parts, wiping, turning flexible knobs, or manipulating clutter can depend on small contact effects. If those effects are wrong in simulation, a policy may learn an action sequence that looks plausible but cannot generate the required forces on hardware.

Sensors and timing are part of the task
Real cameras have exposure and readout behavior, depth holes, rolling-shutter effects, lens distortion, compression, and latency. Motors have backlash, saturation, thermal behavior, and command delays. Real episodes reveal these artifacts directly and show how perception errors propagate through the controller.

The deployment site has a long tail
Objects may be scuffed, partially occluded, wet, reflective, or arranged in ways that were not anticipated. Operators may interrupt a motion, people may enter the workspace, and fixtures may shift. A real dataset captures nuisance factors that are hard to enumerate before deployment.
Hardware changes over time
Wear, replacement parts, camera remounting, calibration drift, and software updates alter the data distribution. Real logs after those changes are needed to verify that the policy still meets its safety and success criteria.
Human interaction is difficult to model
If a robot must interpret demonstrations, handovers, verbal corrections, or unpredictable human motion, recordings from the actual interaction setting are usually more informative than scripted simulation. They expose timing and social cues that a model may otherwise never see.
Why a hybrid pipeline is the practical default
Synthetic data supplies breadth, exact labels, and safe repetition. Real data supplies the embodiment-specific details that determine whether a policy survives contact with the physical world. Combining them lets you spend real-robot time where it has the highest information value instead of using hardware to collect routine variation that a simulator can produce cheaply.

A useful division of labor is:
- Pretraining: use synthetic scenes and trajectories to learn broad visual and behavioral structure.
- Calibration: use a small, representative real set to measure the simulator-to-robot gap.
- Targeted collection: add real episodes for the failure modes revealed by validation.
- Fine-tuning: adapt the policy without erasing useful coverage learned synthetically.
- Acceptance: evaluate on held-out real episodes that were never used for tuning.
This pattern also supports continual improvement: rare production failures become real examples, while the simulator is updated so that related cases can be generated at scale.

Step-by-step workflow
- Define the deployment distribution. Document the robot embodiment, joint and actuator limits, end effector, camera locations, lighting range, object materials and sizes, contact modes, command and observation latency, safety constraints, and the exact success criteria. Include conditions that would cause a human operator to stop the run.
- Build or select the simulator. Reproduce the kinematics, collision geometry, control interface, and actuator limits that matter for the task. For synthetic-data production, NVIDIA describes Isaac Replicator as a robotics-focused toolkit integrated with Isaac Sim. Treat the simulator as an engineering model to be tested, not as ground truth.
- Generate controlled variation. Randomize appearance, object poses, camera parameters, and relevant dynamics. Keep a held-out range of parameters for evaluation. If every training scene uses the full range, a high score may indicate memorization rather than extrapolation.
- Train a simulation baseline. Record policy success, perception precision and recall where applicable, trajectory or control error, episode length, and categorized failures. These metrics establish whether a proposed randomization or model change helps before hardware time is spent.
- Validate on a small real set. Use representative scenes on the target robot, not a convenient demonstration subset. Compare errors by lighting, object, camera viewpoint, contact mode, latency, and operator or site condition. Preserve the recordings and labels so that later changes can be compared against the same cases.
- Close the largest gap first. If failures follow camera viewpoint or exposure, improve rendering and calibration. If they follow timing, measure latency and actuator response. If they occur at contact, add system identification, better contact modeling, or targeted real examples. Widen randomization only when validation shows that the missing variation is the cause.
- Fine-tune with real hardware. Keep separate real episodes for adaptation and final evaluation. Monitor for catastrophic forgetting: a policy that improves on the collected site may lose performance on the broader synthetic or real distribution.
- Run acceptance tests. Test the final policy on held-out hardware episodes, including safety stops, recovery behavior, and the rare cases that matter operationally. Simulator success is not deployment evidence by itself.
- Monitor after release. Log observations, actions, interventions, hardware configuration, and failure categories. Feed rare failures and hardware changes into both the real dataset and the simulator parameters, then repeat validation before changing the deployed policy.
How to use domain randomization without guessing
Randomization is useful when it represents uncertainty that the deployed system may encounter. Vary visual properties such as illumination, textures, backgrounds, object color, camera exposure, and pose when those factors change in the field. Vary dynamics such as mass, friction, motor strength, delay, and compliance only when they are plausible for the robot and task.
Randomizing everything broadly can make learning harder and can hide a modeling defect. Start with measured ranges, reserve an extrapolation range for evaluation, and inspect which parameters correlate with real failures. Google Research found that procedurally generated random objects transferred better than ShapeNet objects for its grasping experiment. In that setup, visual randomization helped when domain adaptation was absent, while dynamics randomization did not significantly improve that particular task. The lesson is to validate each randomization family rather than assume that more variation is always better.
Domain adaptation and calibration
Domain adaptation can align synthetic and real image statistics or features, reducing the amount of labeled real data needed. It does not automatically repair incorrect geometry, contact physics, command timing, or safety behavior. Pair adaptation with camera calibration, system identification, and real validation so that visual alignment is not mistaken for complete transfer.
Do these 3 things before closing this tab:
1Scan for outdated or missing drivers - takes under a minute2Repair Windows errors before they cause bigger problems3Fix the driver behind crashes, sound loss and screen glitchesHow much real robot data do you need?
There is no universal number of episodes, hours, or demonstrations. The required amount depends on task complexity, embodiment count, policy architecture, sensor diversity, simulator fidelity, and the performance threshold. The reported “up to 50 times” reduction from Google Research is a result for a defined grasping objective, not a promise that every project can replace 50 real samples with one synthetic sample.
Use an information-driven schedule instead of a fixed quota:
- Collect an initial set that covers every deployment condition and safety-critical behavior.
- Measure the simulator-to-real error by failure category, not only by overall success.
- Add episodes where the real distribution is poorly represented or where the cost of failure is high.
- Stop expanding a category when additional examples no longer improve held-out real performance.
- Maintain a final test set that remains untouched until model selection and tuning are complete.
For a generalist policy, diversity may matter more than repeating one task on one robot. Google DeepMind describes diverse robot demonstrations as the key step toward a model that controls many robot types. Open X-Embodiment illustrates the scale of that approach with data from more than 20 institutions, 22 embodiments, over 500 skills, 150,000 tasks, and more than one million episodes.

Choosing mostly synthetic, mostly real, or hybrid
| Choose this emphasis | It fits when | Main risk to control |
|---|---|---|
| Mostly synthetic | Labels are expensive, parallel experience is valuable, physical trials are constrained, and the simulator has credible geometry and dynamics. | Policies may exploit simulator artifacts or fail under unmodeled sensing, timing, and contact behavior. |
| Mostly real | Success depends on contact mechanics, sensor artifacts, human interaction, hardware wear, or site-specific conditions that are difficult to model. | Collection is slow and costly, coverage may be narrow, and the policy can overfit one robot, camera, operator, or facility. |
| Hybrid | You need scalable variation and exact labels while still requiring deployment fidelity; this is the strongest default for manipulation and general-purpose policies. | The pipeline is more complex and requires disciplined validation to determine which source fixes each failure. |
Generalization across robots and tasks
Real data is not only useful for matching one robot. A diverse, multi-embodiment collection can teach a policy which visual and behavioral patterns persist across platforms. In the reported RT-1-X evaluation, cross-robot training produced a 50% average success-rate improvement across five robots compared with independently developed methods. The positive-transfer result supports pooling data when action spaces, observations, and task semantics can be represented consistently.
Web-scale visual and language pretraining can add another source of variation. Google DeepMind reported RT-2 performance on previously unseen robot scenarios increasing from 32% with RT-1 to 62% with RT-2 in its stated evaluation. These results show the potential of combining broad prior knowledge with robot data; they do not remove the need to test the final policy on the intended embodiment and site.
Metrics and tests that reveal the real gap
Track separate metrics for perception, control, and operations. A single episode-success number can hide whether the policy failed because it misidentified an object, planned an unreachable motion, lost contact, exceeded a force limit, or timed out.
- Perception: precision, recall, segmentation or pose error, and performance by lighting and viewpoint.
- Control: end-effector error, joint-limit violations, collision events, force or torque excursions, and recovery success.
- Task: completion rate, time to completion, retries, and failure category.
- Transfer: the difference between held-out simulation and matched real scenes, broken down by parameter range.
- Safety: intervention rate, emergency stops, near misses, and behavior after sensor dropout or delayed commands.
Use paired evaluations where the same object sets, camera viewpoints, and task definitions are represented in simulation and on hardware. This makes a change in performance interpretable instead of attributing every gain or loss to a different test mix.
Common failure modes and fixes
The policy succeeds in simulation but collides on the robot
Check collision geometry, control frequency, command latency, actuator saturation, and state-estimation delay. Add measured limits and real collision or near-collision examples; do not respond only by increasing visual randomization.
Perception works in the lab but fails under site lighting
Measure exposure, white balance, glare, shadows, and camera mounting. Recreate the measured range synthetically, add real images from the affected conditions, and keep a lighting-stratified validation set.
Best Value
Randomization reduces performance everywhere
The variation may be implausible or too broad for the learner. Compare one randomization family at a time, use measured bounds, and retain only changes that improve held-out real results.
Fine-tuning overfits a small real dataset
Separate adaptation and evaluation episodes, mix representative synthetic data during fine-tuning, and monitor performance on conditions that were not present in the latest collection.
More demonstrations do not improve success
Inspect the failure categories and information content. Additional examples of an already solved condition are less valuable than examples that cover an unmodeled contact mode, latency range, object material, or recovery behavior.
Operational and cost considerations
Synthetic generation has a high initial engineering cost: scene assets, robot models, calibration, rendering, and simulator validation must be built. Once reliable, it is cheap to replicate and parallelize. Real collection requires robots, operators, maintenance, safe space, supervision, data storage, and often teleoperation or annotation. It is slower but directly measures the system that will be deployed.
Budget for both kinds of work. A simulator that cannot reproduce the failure modes that determine acceptance may consume more engineering time than a small, carefully designed real dataset. Conversely, using hardware to gather millions of routine labeled frames is usually an inefficient use of robot availability when a validated synthetic pipeline can provide them.
A practical decision checklist
- Can the simulator represent the geometry, control limits, contact modes, and latency that determine success?
- Which labels or trajectories are expensive to obtain from people or hardware?
- Which failures are safety-critical or too rare to encounter through ordinary collection?
- What real nuisance factors—lighting, wear, compliance, timing, or human behavior—are absent from simulation?
- Will the policy run on one embodiment or many?
- What held-out real test will determine whether transfer actually worked?
- How will production failures update both the real dataset and simulator?
If the answers emphasize scalable labels and safe exploration, begin synthetically. If they emphasize contact, sensing, timing, or site-specific behavior, collect real data early. If both sets of answers are important, use synthetic pretraining followed by targeted real calibration and acceptance testing.
