For a question-answering system built around your own documents, retrieval-augmented generation (RAG) usually requires less labeled training-data preparation than fine-tuning. RAG retrieves relevant passages when a user asks a question, so you can often work from existing documents instead of creating thousands of input-and-answer examples. It still requires document cleanup, extraction, chunking, indexing, retrieval testing, and an update process. Fine-tuning is usually the better fit when you need a repeatable behavior, task pattern, tone, or output format, but it depends on representative examples paired with correct target outputs and on a training and evaluation workflow.
The practical answer is conditional: RAG often means less annotation, while neither method is automatically less total work. The state of your documents, retrieval quality, model support, evaluation requirements, and how frequently knowledge changes determine the real preparation burden.

Quick verdict
Choose RAG when the main problem is access to changing or private knowledge. Choose fine-tuning when the main problem is consistent behavior or task execution. If you have a folder of manuals, policies, tickets, or product specifications and want answers grounded in them, RAG usually avoids the largest preparation task in supervised fine-tuning: writing and labeling a broad set of example answers.
| Decision question | RAG | Fine-tuning |
|---|---|---|
| What changes? | The context supplied to the model at inference time. | The model’s learned behavior, task pattern, style, or output format. |
| Primary preparation | Select, clean, extract, split, index, and evaluate source documents. | Create representative input/target examples, format them for the selected method, and prepare validation or test data. |
| Best for changing facts | Usually easier to refresh by updating the corpus or index. | Changes may require another training run. |
| Characteristic failure | Irrelevant or missing retrieval produces an off-topic or incorrect grounded answer. | Poor, biased, or incorrectly labeled examples teach the wrong behavior. |
| What determines effort | Document condition, extraction quality, retrieval design, and update frequency. | Example availability and quality, supported training method, evaluation, and training operations. |
This is a decision framework, not a controlled comparison of labor or cost. A clean, well-structured corpus can make RAG straightforward; thousands of inconsistent files can make it a substantial data-engineering project. Conversely, a narrow, well-defined task with an existing set of excellent examples can be easier to fine-tune than to build and monitor a retrieval system.

What “data preparation” means for each approach
RAG prepares knowledge for retrieval
RAG leaves the base model’s parameters unchanged. At question time, the application searches an external collection, selects passages, and places those passages in the model’s prompt. Preparation therefore centers on making source material findable and trustworthy:
- Identify authoritative documents and remove obsolete, duplicate, or conflicting copies.
- Extract text from formats such as HTML, PDF, word-processing files, spreadsheets, or scans. Scanned pages may require optical character recognition, and tables often need special handling so that row and column relationships survive extraction.
- Normalize encoding, headings, lists, units, dates, access permissions, and document metadata.
- Split the material into retrieval units (often called chunks) that preserve enough context to answer a question without becoming so large that search results are noisy or exceed the model’s context budget.
- Create embeddings or another searchable representation, store metadata, and build an index.
- Test whether realistic questions retrieve the right passages, then tune chunk boundaries, filters, ranking, and the number of passages returned.
There is usually no need to write a desired answer for every possible question. The original document remains the source of truth, and the system can cite or display the passages it used. That advantage disappears if the corpus is incomplete, extraction corrupts meaning, permissions are ignored, or retrieval repeatedly returns irrelevant text.
Fine-tuning prepares examples of behavior
Fine-tuning changes model parameters through a training procedure. For supervised tuning, each record normally pairs an input resembling a real request with a target output that represents the behavior you want. Preparation commonly includes:

- Define the task and success criteria before collecting examples. “Answer from policy” is different from “return a JSON object with these fields” or “classify a support ticket into one label.”
- Gather inputs that cover the wording, edge cases, languages, lengths, and ambiguity found in production.
- Write target outputs that are correct, internally consistent, and compliant with the required format. Inconsistent labels or contradictory styles can teach unstable behavior.
- Convert records into the exact format required by the selected model and training method, often JSONL with the expected message or field structure.
- Hold out validation or test data as appropriate. Evaluation examples should measure generalization rather than merely repeating training records.
- Iterate on data quality, hyperparameters, and evaluation after reviewing errors.
Fine-tuning can encode a stable procedure or response style that would otherwise consume lengthy instructions on every request. It does not automatically give the model reliable access to new documents. If the desired behavior depends on facts that change, those facts still need a retrieval or update mechanism.
Why RAG often needs less labeled data
The largest difference is the kind of supervision required. RAG can start with documents that already exist. A team still has to decide which sources are authoritative and how to represent them, but it does not have to invent a target answer for every representative question. The model receives relevant passages at inference time and composes an answer from that context.
Amazon Web Services describes this distinction directly: “If your primary goal is to introduce domain-specific facts, terminology, or knowledge the model hasn’t seen, consider retrieval-augmented generation (RAG) to supply that context at inference time.” Its prescriptive guidance also states, “RAG allows you to build a question-answering system for your custom documents without fine-tuning.” These statements describe the method’s purpose, not a promise that a particular project will take fewer engineering hours.

RAG preparation can become demanding when documents are poorly structured. A 300-page PDF with headers repeated on every page, diagrams carrying essential meaning, and tables split across pages may require more processing than a small set of carefully written examples. Retrieval must also be evaluated: an answer can sound fluent while being wrong because the search step supplied a similar but inapplicable passage. A useful RAG project therefore treats corpus curation and retrieval evaluation as first-class data work, not as a one-time upload.
When fine-tuning can be the lower-effort choice
Fine-tuning may require less preparation when the task is narrow, the desired behavior is stable, and high-quality examples already exist. Consider a support operation that has tens of thousands of consistently labeled tickets and needs a fixed category code. Creating a retrieval index for all ticket history may add privacy filtering, access controls, and ranking complexity without solving the classification problem. A supervised dataset that mirrors the production labels can be more direct.

Fine-tuning is a candidate when you need the model to:

- Follow a repeatable multi-step procedure.
- Produce a strict schema or formatting convention on nearly every response.
- Use a distinctive but consistent style or terminology.
- Classify, extract, transform, or route inputs according to stable labels.
Examples must still be representative. A small collection of polished demonstrations that omits difficult cases can make a tuned model look good in a limited test while failing in production. Quality, coverage, and a trustworthy evaluation set matter more than a headline sample count.
Knowledge that changes frequently
Fine-tuning is a poor first choice when the primary requirement is to keep up with frequently changing documents. Amazon Web Services notes that fine-tuning can take hours to days and may be unsuitable when custom documents change often. With RAG, an updated corpus or index can make new material available without another parameter-training run, although the exact refresh process depends on the platform and still needs testing.

- Define the answerable scope. List the questions the system should answer, the sources it may use, and what it must refuse or escalate. This prevents unrelated files from polluting retrieval.
- Inventory and govern sources. Record owner, effective date, version, access policy, and retention status. Remove duplicates and mark superseded policies instead of allowing both versions to rank equally.
- Extract and normalize content. Preserve headings, section names, page or article identifiers, table relationships, and links to the original document. Check a sample from every format and OCR pipeline.
- Choose chunk boundaries. Split by semantic units such as sections, procedures, or policy clauses where possible. Keep metadata that lets the application filter by product, region, date, or permission.
- Build the index. Generate embeddings or another search representation, store the source text and metadata, and apply the access controls used by the source system.
- Evaluate retrieval separately from generation. Create a test set of real questions with the passages that should be found. Measure whether the right material appears in the returned set before judging the model’s wording.
- Test answer grounding. Check that responses use the retrieved evidence, distinguish uncertainty, and avoid inventing details when no supporting passage is found.
- Operate an update cycle. Re-index changed documents, remove deleted content, and rerun retrieval tests after parser, chunking, embedding, or ranking changes.
Fine-tuning preparation, step by step
- Specify the behavior. Write a task definition and acceptance criteria that can be checked on unseen inputs. Decide whether the task is generation, classification, extraction, ranking, or another supported method.
- Collect production-like inputs. Include normal requests, alternate wording, boundary conditions, and known failure cases. Do not rely only on easy examples selected by one person.
- Create target outputs. Use domain-qualified reviewers when correctness is specialized. Resolve disagreements and document label definitions before scaling annotation.
- Standardize formatting. Follow the selected provider’s schema and JSONL requirements exactly. Validate records automatically for missing fields, malformed messages, invalid labels, and accidental personal data.
- Split the data. Keep validation or test examples separate from training examples. Split by user, document, time period, or case when random row splitting could leak near-duplicates.
- Run a baseline. Compare the untuned model, prompt-only methods, and the tuned model on the same held-out set. A tuning run is useful only if it improves the behavior that matters.
- Inspect errors and iterate. Look for ambiguous instructions, contradictory targets, underrepresented cases, and failures caused by the model or by the evaluation itself.
Official sample-count guidance: what the numbers do and do not mean
Vendor recommendations are tied to particular models and methods. They are starting points, not a universal minimum for fine-tuning and not evidence that one approach always takes less work.
Best Value
| Provider and guidance | Stated amount | Scope and qualification |
|---|---|---|
| Amazon Web Services | At least 100 samples per task | Recommendation in the Amazon Nova Understanding-model fine-tuning data-preparation guidance. The same guidance says the minimum depends on task complexity; the live documentation does not state a publication year. |
| Google Cloud | Start with 100 examples | Recommendation in the Gemini supervised fine-tuning preparation guide. It emphasizes that quality matters more than quantity and recommends a validation dataset; the live documentation does not state a publication year. |
| OpenAI | Several dozen to a few hundred examples | Suggested starting range in an OpenAI reinforcement fine-tuning guide for assessing usefulness, not a universal requirement. The guide calls for training and test datasets in its documented JSONL format; the live documentation does not state a publication year. |
These figures cannot be combined into a single “minimum dataset.” They apply to different providers, models, and methods. A complex task with many labels or safety constraints may need more data, while a narrowly defined behavior may show value with fewer carefully chosen examples.
How changing information affects the choice
Use retrieval for a living knowledge base
Policies, prices, product specifications, schedules, inventories, and internal procedures often change independently of model releases. RAG lets the application retrieve the current approved version, provided the indexing and access-control pipeline is maintained. Include effective dates and version metadata so the system can distinguish a current rule from an archived one.
Use fine-tuning for stable operational behavior
A response format, routing taxonomy, or procedural style can remain stable even as the facts referenced by that procedure change. Fine-tuning can teach the stable behavior; RAG or another data source can supply current facts. This separation is often easier to maintain than trying to encode volatile knowledge in model weights.

Common failure modes and fixes
RAG failures
- Wrong passage retrieved: Improve chunk boundaries, metadata filters, query rewriting, hybrid search, or ranking; then retest with a labeled retrieval set.
- Right document, damaged text: Repair PDF, OCR, table, or encoding extraction and preserve structural metadata.
- Conflicting versions: Track effective dates and ownership, remove superseded material from the active index, and expose source version in the answer.
- Answer unsupported by context: Require the model to state when evidence is missing, lower the number of irrelevant passages, and evaluate grounding rather than fluency alone.
- Unauthorized disclosure: Apply document-level permissions during retrieval, not only after generation, and test with users who have different access rights.
Fine-tuning failures
- Inconsistent targets: Establish written label and style rules, have reviewers reconcile disagreements, and remove contradictory examples.
- Training examples do not resemble production: Sample real traffic patterns and include difficult, long, ambiguous, and adversarial inputs.
- Overfitting or memorization: Use a genuinely held-out test set, inspect near-duplicate leakage, and compare against an untuned baseline.
- Format errors: Validate JSONL and required fields before training, then test exact output parsing on unseen cases.
- Stale factual behavior: Do not use tuning as a substitute for a current knowledge source when the underlying facts change regularly.
A practical decision framework
- Identify the dominant requirement. If it is “know these documents,” start with RAG. If it is “perform this behavior consistently,” investigate fine-tuning.
- Assess the available data. Existing authoritative documents favor RAG; a large, clean set of input-target examples favors fine-tuning.
- Estimate change frequency. Frequent updates favor retrieval or another live data connection. Stable behavior favors tuning.
- Check platform support. Confirm that your chosen model supports the retrieval features, tuning method, file format, context size, and evaluation workflow you need.
- Prototype the smallest credible system. For RAG, test extraction and retrieval on representative questions. For fine-tuning, train a baseline with a held-out test set and compare against prompting.
- Measure the right failure. RAG needs retrieval-relevance and grounding checks; fine-tuning needs behavior, format, and generalization checks.
- Plan maintenance before launch. Assign ownership for re-indexing and source retirement in RAG, or for new annotations and retraining in fine-tuning.
When a hybrid design is appropriate
RAG and fine-tuning are not mutually exclusive. A tuned model can learn how to classify a question, select a response format, or cite evidence, while RAG supplies the current passages. This can reduce prompt length and improve consistency without putting volatile facts into model parameters. The trade-off is two preparation pipelines: a curated example set for behavior and a governed corpus for knowledge. Use the hybrid only when both needs are material; otherwise, its operational complexity may outweigh the benefit.
Project checklists
Choose RAG first when most of these are true
- Your source material already exists and is authoritative.
- Answers must reflect recent edits, versions, or regional rules.
- You can preserve document structure and metadata during extraction.
- You can create representative questions and expected supporting passages for retrieval tests.
- You need users to inspect the source behind an answer.
Choose fine-tuning first when most of these are true
- The desired change is a stable behavior, task, label set, style, or output schema.
- You have enough high-quality examples that resemble production inputs.
- The model and platform support the required tuning method and evaluation format.
- You can keep a held-out validation or test set and review errors.
- The facts involved are stable or will be supplied by another system.
Bottom line
RAG usually needs less labeled example preparation for custom-document question answering because it uses retrieved source passages instead of teaching every answer through training examples. It still demands serious work on curation, extraction, indexing, retrieval quality, permissions, and updates. Fine-tuning is the more direct route to repeatable behavior or strict output formats when representative examples are available, but it requires carefully constructed targets and evaluation data. Decide based on whether your project’s hard problem is supplying knowledge or teaching behavior—and evaluate the actual pipeline rather than assuming either method is universally easier.
