Online Learning vs. Offline Evaluation for Improving AI Agents

Neither online learning nor offline evaluation is a universal winner. Online learning changes an agent from live or simulated interactions, so it can adapt to states its current policy actually reaches. Offline evaluation estimates performance from logged or pre-collected data, avoiding new interaction during the test, but its conclusions are only as reliable as the data coverage and estimator assumptions. They solve different problems and are most useful together.

The right choice depends on interaction cost and risk, how well your data represents deployment, whether you need transfer to new tasks, how you will detect forgetting, and which outcomes and safety checks matter. A sound comparison holds the agent, task distribution, interaction or data budget, and evaluation protocol constant, then measures both immediate success and what happens on unfamiliar tasks.

First, separate the four terms

Discussions often call several different loops “online” or “offline.” Keeping the terms separate prevents invalid comparisons.

Online learning

Online learning updates an agent while it interacts with an environment, users, tools, or a simulator. The next training update can depend on trajectories generated by the current policy. This lets the agent discover states and failures that were absent from an earlier dataset, but each interaction can consume time and money or create operational and safety risk. Live updates can also be difficult to reproduce or roll back.

Offline learning

Offline learning trains on a fixed dataset without collecting new environment interaction during training. The data may contain demonstrations, historical logs, exploration, or a mixture. Its central limitation is coverage: the policy learned from the dataset may later visit states that the data never represented. In model-based reinforcement learning, that gap can make imagined trajectories diverge from actual rollouts.

Offline evaluation

Offline evaluation uses logged or otherwise pre-collected data to estimate how an agent or learning algorithm would perform. It is a measurement procedure, not a training method. Some estimators try to reconstruct the state-action distributions an algorithm would have encountered online; others rely on stronger assumptions. An offline score is not deployment proof, and logged data does not automatically represent future users or tasks.

Concept What changes New environment interaction during the process Main strength Main exposure
Online learning Model or policy is updated from ongoing interactions Yes Can adapt to states the current policy actually encounters Interaction cost, risk, latency, and possible instability
Offline learning Model or policy is trained on a fixed dataset No during training Reuses data without additional live interaction Dataset coverage and distribution mismatch
Offline evaluation Performance is estimated from existing data No during the evaluation Enables repeatable, lower-risk measurement Estimator assumptions and logged-data bias
Online evaluation Performance is measured through fresh rollouts Yes Tests behavior under current deployment-like conditions Cost, exposure to failures, and weaker repeatability

Why this distinction matters for agent improvement

An agent can be trained online and checked offline, trained offline and checked online, or improved through a staged combination. “Online versus offline evaluation” is therefore not a single head-to-head contest. You are choosing where to spend interaction budget and where to place uncertainty: in data collection, in the learning update, or in the measurement method.

Interaction cost and risk

Live trajectories may require paid API calls, human oversight, physical actions, or access to sensitive systems. Offline data can reduce those exposures, which is why offline methods are attractive when exploration is expensive or hazardous. The trade-off is that a cheap score can be misleading if the logs omit rare failures or the states produced by a changed policy.

Coverage and distribution shift

Ask which states, actions, instructions, and failure recoveries appear in the fixed data. Expert demonstrations alone may show successful behavior but little exploration. A policy that departs from the demonstrations can enter regions where an offline learner or evaluator has no evidence. Evaluation data should also match the deployment population, tool versions, task mix, and horizon closely enough for the score to answer the intended question.

Transfer, retention, and interference

Improvement on familiar episodes is not sufficient for a continual agent. Measure performance on new environments, instructions, and task sequences. Also test whether previous capabilities remain usable and whether newly stored experience harms unrelated tasks. These are different properties: transfer asks whether knowledge helps elsewhere; retention asks whether old knowledge survives; interference asks whether learning one stream damages another.

What comparative evidence shows

Results depend on the environments, implementations, data, and budgets used. The following findings are informative rather than universal rules.

Offline methods and the generalization gap

The ICLR 2024 paper The Generalization Gap in Offline Reinforcement Learning compared online reinforcement learning, offline reinforcement learning, sequence modeling, and behavioral cloning on Procgen and WebShop generalization tasks. In those experiments, the tested offline methods struggled to match online RL on both training and new environments. Behavioral cloning was a strong baseline in the multi-environment experiments. The authors also found that increasing data diversity, rather than dataset size alone, improved new-environment performance for all tested offline methods. Read the paper’s scope in the ICLR 2024 proceedings PDF; it does not show that every online method beats every offline method in every domain.

Model-based RL and additional interaction

A 2025 preprint, Offline vs. Online Learning in Model-based RL: Lessons for Data Collection Strategies, reports experiments across 31 environments. It identifies out-of-distribution test states and limited state-space coverage as major challenges for offline agents. In the reported settings, additional online interaction on a fixed or adaptive schedule, and adding exploration data, reduced the degradation observed in offline agents. Because this is a preprint and focuses on model-based RL, treat the result as evidence for data-collection strategies in those conditions, not as a settled prescription for all agents. See the paper record.

Online Experiential Learning

Microsoft Research’s March 2026 publication describes Online Experiential Learning (OEL), a loop for language models. The system extracts transferable experience from deployment trajectories, consolidates it into model parameters through on-policy context distillation, and repeats the cycle. The publication reports text-based-game evaluations with improving task accuracy and token efficiency over successive iterations while preserving out-of-distribution performance. Its own description captures the cycle:

"The two stages are iterated to form an online learning loop, where the improved model collects higher-quality trajectories that yield richer experiential knowledge for subsequent rounds."

These findings cover the reported text-game setup and should not be generalized to every tool-using or safety-critical deployment. Details are on the Microsoft Research publication page.

Skill quality is not the same as task success

SkillLearnBench evaluates continual agent learning at three stages: the quality of a generated skill, the trajectory in which the agent executes it, and the final task outcome. Its project page describes 20 verified tasks across 15 sub-domains. The reported continual-learning methods improve over a no-skill baseline, but no method leads consistently across all tasks and language models. The benchmark also warns that self-feedback alone can create recursive drift; in its setting, external feedback across multiple iterations supports improvement. Consult SkillLearnBench’s benchmark page for the task definition and reported findings.

Task-stream design changes memory conclusions

AgentCL distinguishes dependent task streams, where earlier knowledge can be reused; conventional streams, where reuse is unknown; and independent tasks with little transferable knowledge. Its record, published September 26, 2026 and updated September 29, 2026, reports that dependent streams distinguish memory designs more clearly. Conventional and independent settings often show limited gains and can expose degradation caused by memory. If your benchmark uses only unrelated tasks, it may hide the very retention or reuse behavior a continual-learning system is meant to improve. See the AgentCL record and its linked original work.

Continual-RL metrics from CORA

CORA is a continual reinforcement-learning benchmark platform published in 2022. It supplies environments and baselines for studying forgetting, plasticity, generalization, and sample-efficient learning. Its named measures include Continual Evaluation, Isolated Forgetting, and Zero-Shot Forward Transfer. These categories are useful reminders that a single aggregate reward can conceal severe regression on earlier tasks. The platform is described by CORA in Proceedings of Machine Learning Research.

When an offline score can estimate online behavior

The 2016 AAAI paper Offline Evaluation of Online Reinforcement Learning Algorithms by Travis Mandel, Yun-En Liu, Emma Brunskill, and Zoran Popović studies how existing datasets can evaluate algorithms that would otherwise learn online. It presents three approaches intended to feed algorithms samples from distributions they would have encountered online and reports a method that is provably unbiased given finite data. That guarantee belongs to the stated method and assumptions; it does not make arbitrary offline scores unbiased. The authors frame the practical need clearly:

"In many real-world reinforcement learning problems, we have access to an existing dataset and would like to use it to evaluate various learning approaches."

See the AAAI paper.

A credible comparison is a controlled experiment, not a choice between whichever score is easiest to obtain.

  1. Fix the agent and task distribution. Use the same base model, tools, prompts, environment versions, horizon, and task mix. Separate tasks used for learning from held-out tasks used for transfer.
  2. Declare the budget. Report environment interactions, dataset examples, compute, and tokens. An online method given ten times more trajectories is not comparable to an offline method trained on a small log unless the imbalance is the question being studied.
  3. Build a coverage profile. Record which states, actions, instructions, success trajectories, explorations, and failures are represented. Check whether the evaluation set contains states outside that support.
  4. Run a fixed offline evaluation first. Use held-out logs and a stated estimator. Document its assumptions, confidence limits, and any policy-distribution mismatch. Do not call the resulting score proof of deployment performance.
  5. Test with fresh interaction. Reserve a controlled online evaluation set to reveal unseen states, tool errors, latency effects, and recovery behavior. Keep this set isolated from training updates.
  6. Measure process and outcome. For skill-building agents, score generated-skill quality, whether the skill is invoked, trajectory correctness, and final task success. Add application-specific safety checks rather than relying on task reward alone.
  7. Test transfer and retention. After learning on one stream, evaluate new instructions and environments, then return to earlier tasks. Include unrelated tasks to expose interference.
  8. Repeat across seeds and task orders. Continual-learning results can depend on sequence order. Report per-task results and degradation, not only one final average.

Metrics that reveal the real trade-off

Dimension Question to answer Useful measurements
Transfer Does learning help on tasks not used for updates? New environments, instructions, and task-sequence performance
Retention Do earlier capabilities remain after later learning? Continual Evaluation and Isolated Forgetting-style measurements
Forward transfer Does prior experience improve first attempts on a new task? Zero-Shot Forward Transfer
Data efficiency How much improvement comes from each resource? Gain per interaction, dataset example, compute unit, and token
Coverage quality Does the data include the states the policy will visit? State and action support, exploration coverage, failure and recovery coverage
Agent process Is the agent producing and using useful skills? Skill quality, skill invocation rate, trajectory correctness
Outcome Does the user-facing task finish correctly? Task success, error severity, and application-specific safety checks
Operational behavior Can the method be run within practical limits? Latency, interaction cost, compute, update frequency, and reversibility

When to favor each approach

Start offline when interaction is costly or hazardous

Use existing logs to establish baselines, identify obvious regressions, and compare candidate updates before exposing them to live systems. This is especially useful when actions affect money, privacy, physical equipment, or other people. Make the coverage and estimator assumptions explicit, then confirm important findings with fresh rollouts.

Favor online adaptation when deployment states are hard to anticipate

Online learning is valuable when the agent must discover new layouts, instructions, tool responses, or failure modes that historical data cannot cover. Limit the interaction budget and isolate evaluation trajectories so the agent cannot train on the answer it is being graded on.

Use a hybrid loop for continual agents

A practical pattern is to learn from a curated offline buffer, test on held-out data, collect a controlled amount of online experience, and then consolidate only validated improvements. The OEL results illustrate why repeated collection can help: a better policy may generate more informative trajectories. The same loop can also amplify mistakes, so every update needs regression, transfer, and retention checks.

A practical hybrid workflow

  1. Define the deployment question. Specify whether the goal is higher task success, faster completion, lower token use, better transfer, fewer unsafe actions, or stronger retention.
  2. Freeze a baseline. Keep a versioned agent and record its performance on familiar, held-out, and transfer tasks before any update.
  3. Assemble and audit the offline buffer. Label task, state, action, outcome, source policy, and failure information where available. Quantify which behaviors are absent instead of treating the log as a complete world model.
  4. Train or select candidates offline. Compare methods under the same data and compute budget. Include simple baselines such as behavioral cloning when demonstrations are available.
  5. Evaluate with an estimator suited to the data. State the assumptions behind off-policy or replay-based estimates and flag cases where the candidate policy leaves the logged distribution.
  6. Run a small, isolated online trial. Use fresh tasks and a capped interaction budget. Monitor outcomes, tool calls, latency, and unexpected states; do not silently fold these trials into the score set.
  7. Consolidate only verified experience. Add trajectories that meet quality and safety criteria, then retrain or distill. Keep old model versions and data snapshots so an update can be reversed.
  8. Recheck old and new abilities. Test the original task suite, new environments, dependent task streams, and unrelated tasks. Compare per-task change as well as averages.

Common failure modes and fixes

The offline score is high, but live performance falls

Cause: the evaluation logs do not contain states reached by the new policy, or the estimator assumes a coverage relationship that does not hold. Fix: map policy actions against logged support, add exploration and failure trajectories, and reserve fresh online tests for distribution-shift detection.

The dataset is larger but generalization does not improve

Cause: repeated examples increase volume without adding behavioral or environmental diversity. The Procgen and WebShop experiments found diversity more useful than size alone for new-environment performance. Fix: diversify levels, instructions, trajectories, policies, and recovery behaviors, then measure transfer separately.

Online learning improves one task and damages others

Cause: catastrophic forgetting, interference, or a memory mechanism that stores irrelevant experience. Fix: evaluate dependent, conventional, and independent task streams; include isolated forgetting and unrelated-task checks before accepting the update.

The agent generates a skill but never uses it

Cause: a benchmark measures skill text quality without checking invocation or execution. Fix: score all three SkillLearnBench-style stages: generated skill, execution trajectory, and final outcome.

Self-feedback drifts recursively

Cause: each iteration treats the previous model’s unverified output as truth. Fix: require external or independent feedback across iterations and retain a fixed regression suite.

The comparison favors one method through unequal budgets

Cause: online interaction, offline examples, tokens, and compute are reported as if they were interchangeable. Fix: publish each budget separately and show improvement per resource, alongside absolute performance.

Safety, monitoring, and reversibility

Live adaptation should be assessed against the actual application’s privacy, monitoring, rollback, and human-oversight requirements. The studies above motivate caution around cost, coverage, and degradation, but they do not validate one universal production-control design. At minimum, define what the agent may update, which events trigger review, how a bad model or memory change is disabled, and which fixed tests must pass before broader exposure. Treat these as application decisions, not as guarantees supplied by the online or offline label.

Bottom line

Online learning is strongest when fresh interaction reveals states your data cannot anticipate; offline evaluation is strongest when you need repeatable, lower-risk estimates before spending that interaction budget. Neither substitutes for the other. Use offline data and carefully stated estimators to screen and diagnose, then use controlled online trials to test distribution shift. Judge the result with transfer, retention, process quality, task outcome, and resource efficiency—not a single score on familiar episodes.
