For most AI training systems, the best answer is not one storage tier. Keep the canonical dataset, checkpoints, and artifacts in durable object storage; use a parallel network filesystem when multiple workers need a shared POSIX-like namespace; and stage the hottest shards on local NVMe when each worker can rebuild its cache. This layered design protects data while reducing the chance that storage stalls your GPUs.

The right choice depends on whether your workload streams large sequential shards, performs random sample reads, creates many small files, writes bursty checkpoints, or requires every worker to see the same paths. No single published benchmark fairly ranks all three tiers across those conditions, so design around access patterns and measure end-to-end training time rather than comparing advertised media speeds.

What the three storage tiers actually provide

Object storage: durable API-accessed data

Object storage is built for very large, durable and scalable collections of objects. A service such as Amazon S3 presents data through an API rather than as an ordinary mounted directory. Google Cloud’s AI Hypercomputer guidance recommends object storage for scalable, cost-efficient training datasets and asynchronous checkpointing, while AWS’s storage decision guidance describes it as API-accessed storage.

That distinction affects application design. A training process cannot always use a normal open() call against an object bucket. It may need a cloud SDK, a dataset connector, a filesystem gateway, or a staging job that copies objects to a local or shared filesystem. Object stores also make request patterns visible: opening thousands of tiny files can create more request overhead than reading a small number of large shards.

  • Best fit: canonical raw and processed datasets, sharded training data, model weights, experiment artifacts, and recovery copies.
  • Strength: durability, virtually elastic capacity and a clear system of record.
  • Watch-outs: API request overhead, small-file inefficiency, data-transfer charges and the need to design parallel reads and caching.

Local NVMe or instance store: fast but attached to one worker

Local NVMe is physically close to the CPU and GPUs that consume it. For data already staged on one host, it normally offers the lowest access latency among these choices. Cloud instance-store NVMe, however, is temporary block-level storage tied to the lifecycle of a particular virtual machine. AWS explicitly describes EC2 instance store this way: data must be recreated after instance replacement, stop/start events that do not preserve the device, or interruption.

On self-managed servers, an NVMe SSD is a purchased physical device rather than ephemeral cloud instance store. Check the drive’s PCIe generation, usable capacity, endurance rating, cooling and sustained throughput. Burst figures from a short benchmark are not a substitute for performance during a multi-hour preprocessing or training run.

  • Best fit: per-worker dataset caches, decompressed shards, shuffle files, temporary preprocessing output and high-rate scratch I/O.
  • Strength: very low latency and no network hop for local reads.
  • Watch-outs: capacity is limited per worker, caches must be rebuilt, and a failed or interrupted instance can erase the only copy if the design is careless.

Network file storage: a shared namespace for many workers

Network file storage exposes files and directories to multiple machines. AWS’s decision guide identifies file storage for shared read/write access across instances. For latency-sensitive, high-bandwidth distributed training, AWS specifically recommends FSx for Lustre with S3 integration. A parallel filesystem such as Lustre distributes data and metadata across storage servers so many workers can read concurrently.

A general NFS or EFS share can be simpler to deploy and is useful when compatibility and shared paths matter more than maximum aggregate training throughput. It should not be assumed to perform like a parallel filesystem under hundreds or thousands of concurrent data-loader operations. Metadata behavior, directory layout and client mount settings can become the limiting factors.

  • Best fit: multi-node jobs that need common paths, concurrent reads and writes, shared metadata, checkpoint coordination or POSIX-like behavior.
  • Strength: one namespace visible to many workers, often with integration that can import or export data to object storage.
  • Watch-outs: network contention, metadata hot spots, mount and identity configuration, and the cost and operational work of running an additional storage service.

Comparison at a glance

Decision axis Object storage Local NVMe Parallel network filesystem
Interface API, SDK, connector or staging layer Local block device and filesystem Shared filesystem mount with POSIX-like paths
Latency for hot data Higher and request-dependent Lowest when data is already local Low to moderate, depending on network and filesystem load
Aggregate multi-worker bandwidth Can scale with parallel requests and service limits Limited to each host’s device and bus Designed to aggregate reads across many clients
Shared namespace Object keys, not ordinary directories No; each worker has its own device Yes
Durability Primary durable copy Temporary for cloud instance store; hardware-dependent on premises Service-dependent; use object storage for an independent recovery copy
Capacity scaling Very large and service-managed Bound to the worker or installed drive Scales with the selected filesystem configuration
Small-file behavior Request overhead can dominate Usually efficient locally, subject to filesystem metadata Metadata servers and directory contention can dominate
Recovery after worker loss Read the durable copy again Rebuild the cache Depends on filesystem durability; export checkpoints and source data separately
Published universal latency or GB/s figure Not stated Not stated Not stated

The table deliberately does not assign a universal GB/s or latency value. Results vary with instance type, PCIe link, network topology, concurrency, object size, file format, client settings and caching. A number measured on one cluster cannot be safely presented as a ranking for every training job.

How storage choice affects a training step

Sequential shard streaming

If each worker reads large, contiguous shards once and moves on, object storage can work well when the data loader issues parallel requests and the service is nearby. Large shard formats reduce per-object request overhead. A local cache can still help when the same epoch is repeated or when preprocessing expands compressed data.

Random sample reads

Random access magnifies latency and request count. Thousands of small object reads can leave GPU data-loader processes waiting even when the bucket has ample total bandwidth. Staging shards on local NVMe, or placing them on a parallel filesystem with an appropriate layout, usually gives the loader more predictable access.

Many small files

Small files stress object-store request handling and filesystem metadata. Consolidate samples into reasonably sized shards where the framework permits. On a shared filesystem, avoid putting every worker’s temporary files in one hot directory; use worker-specific directories or a layout that spreads metadata operations.

Checkpoint bursts

Checkpoints often create a sudden write burst that is different from steady-state reads. Write the recovery checkpoint to durable object storage and verify that the upload completed. A local or parallel filesystem can act as a transient write buffer only when the workflow guarantees an upload, integrity check and retention policy.

Recommended architectures

Single-node or small experiment

Keep the canonical dataset and checkpoints in object storage. Before training, copy the active shards to the worker’s local NVMe and point the data loader at that cache. If the worker is replaced, run the copy step again; do not treat the cache as the authoritative dataset.

  1. Create a versioned dataset prefix in object storage and record the exact manifest used by the run.
  2. Reserve enough local capacity for the active shards, decompressed working set and temporary shuffle files.
  3. Copy or stream the shards before starting the GPU-heavy portion of training. An illustrative command is aws s3 sync s3://your-bucket/dataset-version/ /local-nvme/dataset-version/; adapt the command and authentication to your provider and security policy.
  4. Run a checksum, file-count or manifest verification before launching workers.
  5. At the end of the run, upload checkpoints and important logs to object storage. Treat local outputs as disposable after verification.

Distributed training with shared paths

For a multi-node job in which every worker must open the same paths, keep object storage as the source of truth and mount a parallel filesystem such as FSx for Lustre for the active training set. AWS documents S3 repository integration, striping for parallel access and GPUDirect Storage support in this context.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
  1. Place the immutable dataset and prior checkpoints in object storage.
  2. Provision the parallel filesystem in the same region or network domain as the training workers when possible.
  3. Import or stage the required dataset into the filesystem and choose a layout that distributes large files across storage targets.
  4. Mount the filesystem on every worker using consistent paths, identity settings and security rules.
  5. Run a short representative loader test with the intended worker count before committing to a long training run.
  6. Write checkpoints to the shared filesystem only as an intermediate step, then upload verified recovery copies to object storage.

Mixed fleet or irregular access

When workers have different shapes, jobs are intermittent, or only a subset of data is hot, combine object storage with a shared file or cache layer and add local NVMe only where repeated reads justify it. The shared layer supplies a common namespace; local NVMe absorbs the hottest reads and temporary files.

Measure the complete path from storage request to GPU utilization. The important result is step time, input-pipeline wait time and sustained accelerator utilization, not the peak throughput printed by a storage benchmark.

Step-by-step design method

1. Classify every data product

  • Source and processed datasets: durable object storage.
  • Read-only active shards: local NVMe for one-host jobs, parallel filesystem for shared multi-node access.
  • Temporary decompression and shuffle data: local NVMe where possible.
  • Checkpoints and experiment artifacts: object storage, with a transient local or shared write buffer only if upload verification is automatic.

2. Describe the access pattern

Record whether workers read sequentially or randomly, how many files each worker opens, whether the same sample is read repeatedly, whether all workers need identical paths, and how often checkpoints are written. This description is more useful than choosing a medium from a generic speed chart.

3. Estimate the working set

Calculate the space required for compressed shards, their decompressed form, shuffle files, tokenizer or preprocessing outputs and temporary logs. Leave headroom for concurrent workers and filesystem metadata. If the working set cannot fit on every worker, use a shared filesystem or stream from object storage with an effective cache.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

4. Define failure and recovery behavior

Write down what happens when a worker disappears during an epoch, when a filesystem mount fails, or when a checkpoint upload is interrupted. A sound design can recreate local caches, remount or replace shared storage, and resume from a verified durable checkpoint without manual data reconstruction.

5. Test with production-like concurrency

Use the actual framework, shard format, worker count, batch size, prefetch depth and network path. Compare input wait time and end-to-end step time with GPU utilization. A test with one worker reading one large file cannot predict a run with hundreds of workers opening many small files.

Common failure modes and fixes

GPUs are idle while object reads complete

Likely cause: too many small requests, insufficient prefetching, or a connector that serializes reads.

Fix: consolidate samples into larger shards, increase safe parallelism, prefetch to local NVMe, and verify that workers are reading from the intended region and network path.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Training works on one node but collapses at scale

Likely cause: a shared filesystem’s metadata service, network link or directory layout is saturated.

Fix: inspect metadata operations separately from data throughput, distribute files and directories, reduce per-sample open/close activity, and consider a parallel filesystem designed for aggregate distributed reads.

A restarted instance has lost the dataset

Likely cause: the only copy was on temporary instance-store NVMe.

Fix: retain the canonical dataset in object storage and automate cache hydration from a versioned manifest whenever a worker starts.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Checkpoints exist locally but cannot be recovered

Likely cause: the job ended before a buffered checkpoint reached durable storage, or the upload was not verified.

Fix: make checkpoint uploads explicit, verify size and checksum or a completed multipart operation, and alert when the durable copy is missing.

Storage looks fast in a benchmark but training remains slow

Likely cause: the benchmark measured peak sequential throughput while the data loader performs random reads, metadata-heavy operations or synchronized bursts.

Fix: profile the actual loader and correlate storage wait time with GPU utilization. Change the file format, shard size, cache policy or worker concurrency before replacing hardware.

Cost and operational trade-offs

Object storage generally minimizes the burden of capacity planning, but request volume, retrieval and data movement can affect total cost. Local NVMe can be economical when it is bundled with a selected cloud instance or already installed in a server; the trade-off is cache rebuild time and loss on worker failure. A managed or self-operated parallel filesystem adds a separate service and network path, but can reduce repeated object reads and provide the shared semantics distributed jobs require.

Compare the full run, not only storage rates:

  • time spent staging data before the first step;
  • extra object-store requests and transfer charges;
  • filesystem or instance charges while the cluster is idle;
  • engineering time for mounts, permissions, monitoring and recovery;
  • the cost of GPU time wasted while input workers wait.

For on-premises NVMe purchases, include endurance, replacement, cooling and compatible PCIe lanes. For cloud instance store, verify that the selected instance actually includes the advertised local device and understand what events erase it.

Choosing by scenario

Scenario Recommended baseline Reason
One worker or one server, repeated epochs Object storage plus local NVMe cache Durable source with fast repeated local reads
Many workers need the same directory paths Object storage plus parallel filesystem Shared POSIX-like namespace and aggregate bandwidth
Occasional jobs with changing hot data Object storage plus selective local caching Avoids paying for a permanently provisioned shared layer
Many tiny samples Re-sharded data on local NVMe or parallel filesystem Reduces object requests and metadata pressure
Regulated or disaster-recovery-sensitive outputs Durable object-storage checkpoints Separates recovery copies from worker and filesystem failures

Practical checklist before launching a long run

  • Is there one versioned, durable dataset manifest in object storage?
  • Can every worker access the intended storage endpoint and credentials?
  • Does the active working set fit with headroom on local NVMe or the shared filesystem?
  • Are files sharded to match the number of workers and expected access pattern?
  • Have you tested metadata load as well as sequential bandwidth?
  • Does a worker restart automatically rebuild its cache?
  • Are checkpoints uploaded and integrity-checked before local buffers are deleted?
  • Can the job resume from the last durable checkpoint after a filesystem or instance failure?
  • Are GPU utilization and input wait time being monitored during the real workload?

The practical verdict

Use object storage for the durable system of record. Add local NVMe when a worker can profit from a fast, disposable cache. Add a parallel network filesystem when distributed workers need a shared namespace and high aggregate throughput. In the common production design, all three have distinct jobs: object storage preserves the data, the network filesystem coordinates shared training access, and local NVMe serves the hottest bytes. Choose the layers from the workload’s access pattern and validate them with end-to-end step-time measurements.

Frequently Asked Questions

Can I train directly from object storage?

Yes, if the framework and connector support the required API access and parallelism. Large shards, prefetching and caching are important; ordinary local file-open assumptions may require a staging layer.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Is local NVMe always faster than a network filesystem?

For data already on one host, local NVMe usually has lower latency. A parallel filesystem can deliver greater aggregate throughput when many workers read concurrently, so the faster choice for a job depends on concurrency and data layout.

Should checkpoints be written only to local NVMe?

No. Local NVMe or a shared filesystem may buffer a checkpoint, but keep a verified durable copy in object storage so worker loss or interruption does not remove the recovery point.

Is a general NFS share equivalent to Lustre for AI training?

No. Both provide shared files, but a general file share is not automatically a parallel filesystem optimized for high aggregate distributed-training throughput. Measure the actual workload before selecting it.
