Memory, Not Speed, Is the Hard Part of Running an LLM on a Phone

Running a large language model (LLM) on a phone is often constrained less by peak processor speed than by whether the device can keep the model and its working state in memory—and move the needed data quickly enough to generate each token. Model weights are only part of that budget: the key-value (KV) cache and other runtime state take memory too. Quantization and cache optimizations can help, but the practical limit varies by model, software, and phone.

Why can memory matter more than processor speed?

An LLM generates text one token at a time. Its model weights—the learned parameters—must be represented and accessed during inference. In its explanation of an optimized on-device workload, Qualcomm says repeatedly reading parameters to generate tokens makes memory bandwidth a constraint. That is a useful way to understand token decoding, but it is not a rule that every phase of every model run is limited by memory: prompt processing, decoding, the chosen accelerator, and the software runtime can have different bottlenecks.

Capacity and bandwidth are related but distinct. Capacity determines whether the weights and working state fit in usable memory at all. Bandwidth affects how quickly data can move between memory and the processor or accelerator. A fast chip cannot make an oversized working set fit, and a model that fits can still generate slowly if moving its data is the limiting step.

What uses memory besides the model weights?

Model weights

Weights encode the model’s learned behavior. Their size in memory depends not only on the parameter count but also on how the values are represented. Lower-bit quantization uses fewer bits for at least some values, reducing the weight footprint, though the resulting quality and speed depend on the model and implementation.

The KV cache

During inference, a model keeps attention-related information for prompt and generated tokens in a key-value cache. That cache is separate from the weights and can grow as the context gets longer. Its size also depends on model architecture and runtime choices. Apple describes KV-cache update optimizations in its on-device model material and cache sharing in its 2025 technical report; such techniques can reduce costs in particular implementations, not erase them for every model.

Runtime state and available headroom

The runtime needs memory for other working data as well. The amount a phone can actually devote to inference can be lower than its advertised physical RAM, especially when the operating system and other apps are active. Google’s on-device benchmarking guidance treats peak memory as an important operational metric and warns that using too much available memory can cause delays or crashes.

How can quantization and cache optimization help?

Quantization stores model values at lower precision, often reducing the space weights occupy and the amount of data that must be moved. It is a trade-off, not a free shrink operation: quality, speed, and memory effects depend on the model, quantization method, and runtime. Apple’s materials describe mixed low-bit techniques for its on-device models and, in a 2025 report, 2-bit quantization-aware training. Qualcomm has described an INT4 approach for its own evaluated models.

Cache optimization addresses a different part of the budget. Because the KV cache holds attention state as tokens are processed, techniques that update or share it more efficiently can reduce memory pressure. The benefit depends on the model and implementation, and a longer usable context can still require more working memory.

Can a phone use storage instead of RAM?

Specialized flash-offloading methods can keep some model parameters in flash storage and bring them into DRAM when needed. Apple’s 2024 “LLM in a Flash” research reported evaluating models up to twice the available DRAM with its approach. In that research setup, Apple also reported 4–5× CPU and 20–25× GPU inference speed relative to naive loading approaches.

These are results from a specific research method and setup, not a promise that any phone can smoothly run any model larger than its RAM. Flash storage is not equivalent to fast, continuously available working memory: data must be moved into DRAM, and the result depends on the method, device, and workload. Extra storage capacity by itself does not solve a RAM or bandwidth bottleneck.

How do I run an LLM on my phone?

Use a mobile inference app or runtime that supports the model and the phone’s operating system and hardware. Choose a model and context length that the runtime can load within the device’s memory budget; if available, a quantized version may reduce the weight footprint. Exact app names and steps vary, and the sources cited here do not establish one current app or a universal minimum RAM requirement.

A budget-friendly yet feature-packed waterproof phone for everyday needs!

Then test the actual task on the target phone. A short prompt and answer may fit comfortably while a long conversation or document pushes the KV cache and other working state higher. Close unnecessary apps if memory pressure is causing instability, and reduce the context length or choose a smaller or more efficiently represented model if the run still fails. Do not assume that a phone’s storage capacity can substitute for memory available to the runtime.

Does running an LLM on a phone need more memory or a faster processor?

It depends on the failure or slowdown. If the model cannot load, crashes under memory pressure, or only works with a shorter context, capacity is the immediate issue. If it loads but generates slowly, bandwidth, accelerator capability, runtime efficiency, or the workload may matter; raw processor speed alone does not explain performance. Prompt prefill and token decoding should also be measured separately because they are different phases.

There is no evidence here for a universal RAM cutoff or model-size limit that applies to all phones and uses. Google describes Android as spanning different accelerators, operating systems, and system-on-chip configurations, and says its AI Edge Portal benchmarks across more than 120 representative device types. That variation makes workload-specific results more useful than a single minimum-RAM rule.

How should you compare phone and model setups?

Use the same model, prompt, context length, runtime settings, and task where possible. Compare the complete experience rather than relying on a peak chip specification or one token-per-second number.

Measure What it tells you
Initialization time How long the model takes to load and become usable.
Prompt prefill or time to first token How long processing the input takes before a response begins.
Decode rate How quickly the model generates tokens after the first one.
Peak memory and stability Whether the run approaches memory limits, slows down, or crashes.
Task quality Whether the model produces useful results for the work you actually need.
Usable context length How much prompt or conversation history the setup handles without unacceptable slowdown or memory pressure.

Google identifies initialization, prefill, decode, and peak memory as useful on-device metrics. Quality and context length need to be judged against the intended use. Results can change with the runtime, accelerator, operating system, and background memory pressure.

What do published phone results actually show?

Published figures illustrate what particular optimizations can achieve, not what every phone should deliver. Apple reports that, with its described model and optimizations on iPhone 15 Pro, it reached about 0.6 millisecond of time-to-first-token latency per prompt token and a generation rate of 30 tokens per second. Qualcomm reported up to 20 tokens per second for an optimized Llama 2-7B Chat demonstration on a phone powered by Snapdragon 8 Gen 3. Both are vendor-reported results tied to their stated device and model contexts, not directly comparable cross-platform tests or consumer expectations.

The practical lesson is to judge a setup by whether it fits the model and context, stays stable, responds promptly, and produces adequate quality for the task. A faster processor helps only insofar as it addresses the bottleneck the workload actually has.
