No single mode finds every class of failure, and no framework is a universal winner. Choose tools by the lifecycle coverage, data flow, evaluators, observability, hosting controls, and governance your team actually needs.
How the three evaluation modes differ
Offline evaluation asks whether a proposed model, prompt, agent, or tool configuration behaves correctly on a fixed dataset. Production monitoring asks what happens on real traffic after deployment. Red teaming deliberately supplies adversarial, abusive, or unexpected inputs to expose misuse and security weaknesses.

| Mode | When it runs | What it reveals | Typical outputs |
|---|---|---|---|
| Offline tests | Before deployment and in CI | Regression, functionality, style and content compliance, and model or prompt differences on known cases | Pass/fail gates, scorecards, comparison reports, and versioned datasets |
| Production monitoring | Continuously on live traces or sampled traffic | Distribution shift, new intents, tool-call errors, latency or cost changes, anomalies, and quality drift | Alerts, trace views, online scores, incident queues, and new regression cases |
| Red teaming | Before launch and after major changes | Jailbreaks, prompt injection, data-exfiltration attempts, unsafe tool use, policy violations, and multi-turn manipulation | Attack transcripts, severity ratings, reproducibility, mitigations, and retest status |
LangChain’s documentation describes offline types as benchmarking, unit tests, and regression tests for pre-deployment work, while online types include monitoring and anomaly detection in production. OpenAI’s guidance similarly frames evals as tests against criteria a team specifies for model outputs. Red teaming is narrower and more adversarial: OpenAI defines it as using adversarial test cases to uncover unsafe, insecure, or policy-violating behavior before deployment.
Offline evaluation: make releases repeatable
Build a representative, versioned dataset
Start with a small dataset that contains ordinary requests, edge cases, and high-risk interactions. Include examples from your domain rather than relying only on generic benchmarks. Useful sources include synthetic examples, purchased datasets, human-curated cases, historical support or task data, and appropriately governed production examples. Record the dataset revision so a score can always be traced to the exact cases used.

Use the right evaluator for each requirement
- Deterministic code checks: Use exact matching, schema validation, required-field checks, numerical tolerances, or tool-call assertions when the expected result is objective.
- Heuristics: Check length, prohibited terms, citation presence, formatting, or other measurable properties.
- Human review: Use trained reviewers for nuanced factuality, usefulness, tone, or safety judgments that cannot be reliably reduced to a rule.
- Pairwise comparison: Ask reviewers or a judge to compare two versions when choosing between prompts or models is easier than assigning an absolute score.
- LLM-as-judge: Apply a calibrated rubric to subjective qualities, and periodically compare judge decisions with human labels to detect drift or bias.
OpenAI’s eval guidance emphasizes defining the grading criteria rather than treating a model’s unstructured impression as the test. Store the model version, prompt version, evaluator version, and dataset revision with every run. Without those fields, a score change cannot tell you whether the model improved or the measurement changed.
Turn tests into release gates
Set thresholds for the dimensions that matter to the application: task success, structured-output validity, safety violations, tool-call correctness, and regression rate. A release gate can require that critical cases pass at 100 percent while allowing a measured tolerance for subjective scores. Keep separate results for normal, edge, and high-risk subsets so a strong average cannot conceal a safety regression.
Production monitoring: evaluate what users actually send
Trace requests, responses, and actions
Online evaluation operates on production traces or traffic. Capture the input, output, model and prompt identifiers, retrieval context where permitted, tool calls and their results, latency, token or usage data, and the final application outcome. Apply access controls and retention rules before collecting sensitive content.

Score continuously, not only after incidents
Sample or score traces with deterministic checks, heuristics, human review, or an LLM-as-judge. Monitor quality and safety alongside operational signals. A response can be fluent while a tool call fails, a latency spike can cause user-visible errors, and a cost increase can make an otherwise accurate workflow unsustainable.
- Watch for new intents and distribution shifts that are absent from the offline dataset.
- Alert on anomalous failure rates, unsafe outputs, malformed tool calls, latency changes, and usage or cost changes.
- Route high-value or risky traces to a review queue rather than treating every automated score as ground truth.
- Link an alert to the complete trace so an engineer can reproduce the behavior and identify the responsible prompt, model, retrieval step, or tool.
Close the production-to-test loop
When a confirmed incident appears, redact or minimize sensitive data, label the failure, and add a suitable reproduction to the offline regression set. This is how the test suite reflects current user behavior instead of remaining a static collection of examples. Keep the original trace available under the organization’s retention and access policy so reviewers can verify that the new case represents a real failure.
Red teaming: attack the safeguards deliberately
Define an authorized threat model
Red teaming focuses on misuse, abuse, security, and policy-violation behavior rather than ordinary answer quality. Before testing, define the assets, attacker capabilities, prohibited outcomes, and success criteria. Test only systems and data you own or are explicitly authorized to assess; OpenAI’s red-team guidance warns that submitted code or assets must be owned by or authorized by the tester.

Cover the attack surfaces
- Jailbreaks: Try instruction patterns that seek to bypass refusal or policy controls.
- Prompt injection: Place conflicting instructions in user content, retrieved documents, web pages, files, or tool results.
- Sensitive-data exfiltration: Attempt to extract secrets, hidden prompts, personal data, or credentials.
- Unsafe tool use: Test whether the agent can be induced to call a tool with dangerous arguments or excessive permissions.
- Multi-turn manipulation: Build a benign conversation gradually, then introduce a request that depends on the accumulated context.
- Abuse and policy cases: Include high-risk content relevant to the product’s users and jurisdiction.
Log the exact attack, the system state, the model response, any side effect, and whether the result is reproducible. Rate severity by potential harm and exploitability, assign an owner, apply a mitigation, and rerun the attack. Red teaming complements ordinary evals because a curated quality suite may never contain the interaction that exposes a safeguard failure.
Frameworks compared
The following tools occupy different positions in the lifecycle. The descriptions reflect the capabilities documented by OpenAI, LangChain, and Anthropic; product features, hosting regions, and terms can change, so verify current documentation before adopting a specific configuration.
| Framework | Lifecycle coverage | Documented strengths | Best fit |

How to choose a framework
Choose by lifecycle coverage
If your immediate problem is reproducible model or prompt testing, an offline-focused building block may be sufficient. If failures are appearing only after launch, prioritize trace ingestion, online scoring, anomaly detection, and incident workflows. If the main concern is jailbreaks, injection, or dangerous agent actions, add a dedicated adversarial layer rather than assuming ordinary regression tests provide security coverage. Many teams combine a functional evaluator with an observability platform and a red-team tool.
Compare the capabilities that affect operations
- Data and trace ingestion: Can it import your datasets and capture the context needed to reproduce a failure?
- Evaluator choices: Does it support code, heuristics, human labels, pairwise comparisons, and calibrated LLM judges?
- CI/CD integration: Can a pull request run the relevant cases and block a regression?
- Observability: Are latency, cost or usage, tool calls, and complete traces visible with access controls?
- Hosting and residency: Can deployment and retention meet your contractual, regulatory, and security requirements?
- Red-team workflow: Can you generate or import attacks, record severity, and track remediation and retesting?
- Governance: Are roles, approvals, audit history, and evaluator changes reviewable?
A practical implementation sequence
- Create the initial dataset. Version normal, edge, and high-risk cases, and document the expected behavior or grading rubric for each.
- Add deterministic checks first. Validate schemas, required fields, tool arguments, and other objective conditions before introducing subjective judges.
- Calibrate subjective evaluation. Use human labels to tune an LLM-as-judge rubric, measure disagreements, and keep examples of acceptable and unacceptable outputs.
- Record provenance. Save evaluator, model, prompt, tool, and dataset versions with every result.
- Set release thresholds. Gate critical safety and correctness cases separately from aggregate quality scores.
- Instrument production. Trace requests and actions, sample or score them online, and alert on quality, safety, latency, cost, and tool-use anomalies.
- Review incidents. Send high-risk or uncertain traces to qualified reviewers, preserving the evidence needed to reproduce the issue.
- Promote confirmed failures. Convert incidents into redacted offline regression cases and update the rubric when the failure reveals a missing criterion.
- Run authorized campaigns. Red-team before launch and after major model, prompt, tool, or policy changes; track severity, mitigation, reproducibility, and retest status.
Common mistakes and fixes
Relying on one aggregate score
An average can hide a severe failure in a small high-risk subset. Report slices by task, user type, language, safety category, and tool path, and set separate gates for critical cases.

Testing only happy paths
Normal examples do not represent distribution shift, malformed inputs, conflicting instructions, or adversarial behavior. Add edge and attack cases, then refresh them from reviewed production incidents.
Best Value
Treating an LLM judge as unquestionable
Judges can be inconsistent or biased toward particular styles. Keep objective checks where possible, calibrate against human labels, monitor judge-version changes, and investigate large score movements.
Collecting traces without a response plan
Telemetry that nobody reviews becomes storage rather than quality control. Define alert thresholds, ownership, escalation, retention, and the path from incident to regression test before enabling broad collection.
Confusing red teaming with capability benchmarking
Capability evaluations ask what a model can do under a defined task. Red teaming stress-tests specific safeguards and abuse paths. Use both when the application’s risk profile requires them.
