Physics-informed AI can make repeated chip-simulation runs dramatically faster, but it does not eliminate the trusted simulator. The practical pattern is to run TCAD, SPICE, finite-element, lithography or materials solvers on representative cases; train a surrogate model that respects the relevant physics; validate it on operating points and geometries it has not seen; then use that model for broad design-space exploration. Final candidates still go back through the conventional simulator for calibration and signoff.
For suitable workloads, published vendor results range from a 12x S-Device benchmark improvement to projected gains of up to 30x for circuit simulation and more than 100x for a thermal-surrogate workflow. Those numbers depend on hardware, baseline, model, training coverage and workload, so they are not universal replacement claims.

In semiconductor engineering, the machine-learning component is usually a surrogate model: a fast approximation of an expensive simulation. A conventional solver may take seconds, minutes or hours for one design point. Once a surrogate has been trained and validated, inference can produce an estimate in milliseconds or another much shorter interval, allowing engineers to evaluate many more alternatives.

NVIDIA describes these models as “ultra-fast, deep learning-based replicas of slow, physics-based simulations.” The important word is replicas, not replacements. The original solver remains the reference used to generate training data, check errors and approve a final design.
Why ordinary machine learning is not enough
A model trained only to minimize an average prediction error can produce plausible-looking but physically impossible results. It may violate charge, energy or mass conservation, ignore a boundary condition, or fail when geometry or process conditions move outside the training distribution.
Physics-informed or physics-guided training addresses those risks by incorporating physical residuals, dimensional checks, boundary conditions or other constraints alongside simulator-generated examples. This does not guarantee correctness. It gives the model a structure that is better aligned with the problem and makes failures easier to detect.
How the acceleration workflow works
- Choose a repeated bottleneck. Start with a loop that is expensive and run often, such as a thermal sweep, TCAD parameter exploration, circuit corner analysis or lithography optimization.
- Generate high-fidelity examples. Run the trusted simulator across the geometries, materials, process corners, loads and boundary conditions that the surrogate will encounter.
- Train a structure-aware model. Select a graph model for changing connectivity or geometry, a neural operator for field problems, or another architecture supported by the chosen physics-AI stack. Add physical constraints and dimensional checks.
- Validate on held-out cases. Keep solver cases out of training and test the model on those unseen points. Measure prediction error, conservation, stability and behavior near process limits.
- Deploy for exploration. Use the surrogate to rank, filter or optimize thousands of candidates instead of sending every candidate through the slow solver.
- Re-run finalists conventionally. Pass shortlisted designs through the calibrated simulator, and use that result for signoff or for another training cycle if the surrogate missed an important regime.
This arrangement changes where compute is spent. High-fidelity simulation is concentrated on representative data and final verification; inexpensive inference handles the large middle of the search.

“From hours to milliseconds” is NVIDIA’s description of the potential for suitable semiconductor surrogate workloads. Treat that phrase as a workload-specific vendor claim, not a promise for every design or simulator.
TCAD device and process simulation
Device simulation repeatedly evaluates electrical behavior as dimensions, doping, materials, contacts and bias conditions change. A surrogate can learn mappings between those inputs and quantities such as current, voltage, field or temperature, then screen a large parameter space before selected points are returned to the TCAD solver.
The reported 12x S-Device result is a benchmark for accelerated solver infrastructure, not proof that a neural surrogate will deliver 12x on every TCAD deck. A fair comparison must state the device, equations, convergence settings, CPU baseline, GPU model and whether data-generation time is included.

Thermal and electro-thermal analysis
Thermal problems are attractive targets because chip, package and system designs often require many similar solves under different powers, materials, cooling conditions and geometries. A surrogate can estimate temperature fields or thermal metrics quickly enough to participate in placement, packaging and design-space optimization.

Synopsys reports more than 100x faster thermal simulation when PhysicsNeMo surrogates are integrated with SeaScape. That result applies to the described integration and training setup. It should not be read as a general finite-element speed guarantee, especially when a new geometry or material lies outside the training set.
Circuit simulation
SPICE-class circuit analysis remains essential for transistor-level accuracy, nonlinear convergence and signoff. AI can reduce the number of expensive evaluations by approximating repeated portions of a workflow, prioritizing promising parameter sets or accelerating supported solver kernels.
Synopsys projects up to 30x faster PrimeSim workloads on NVIDIA GB200 Grace Blackwell and reported earlier GH200 results of up to 15x. These are platform and workload projections. A production team should benchmark its own netlists, models, corner count, transient length and accuracy requirements.
Computational lithography
Lithography optimization is both physics-heavy and data-constrained. The model must account for process behavior, mask geometry and imaging conditions over the target process window. A neural model can help search mask candidates or approximate repeated evaluations, but an apparently small error can translate into a critical-dimension or yield problem.
The reported Proteus result is a projected speedup of up to 20x on NVIDIA B200. Physics-inspired architectures are best treated as accelerators or auxiliary components until they have been validated across the exact process window, pattern classes and failure modes of the production flow.
Materials and device discovery
Materials workflows can spend substantial time evaluating electronic, structural or thermal properties for candidate compositions and device structures. A surrogate can narrow the candidate list before expensive quantum or atomistic calculations are run. Synopsys cites a 6–10x improvement in development time for one QuantumATK use case; that is a case-specific development result, not a universal materials-simulation multiplier.
Advanced packaging and multiphysics
Packaging combines thermal, mechanical, stress and electrical effects across several length scales. NVIDIA identifies workflows involving Cadence, COMSOL and Voltai that span thermal, stress, electro-thermal and mechanical simulation. A useful surrogate may predict a field, a hotspot metric or a pass/fail constraint, while the coupled high-fidelity model remains necessary for final decisions.
Choosing a surrogate model
There is no single “best” AI model for semiconductor simulation. The right choice depends on how the inputs and outputs are represented, whether geometry changes, and which physical guarantees matter.

| Model approach | Best fit | Questions to answer before deployment |
|---|---|---|
| Graph networks | Designs represented as nodes and edges, including changing topology or connectivity | Does the graph representation preserve the physical relationships that drive the result? Can it handle unseen graph sizes or layouts? |
| Neural operators | Field problems in which a function, geometry or boundary condition maps to another field | Does the operator cover the geometry and boundary-condition family used in production? How are meshes and resolutions handled? |
| Physics-informed or physics-guided networks | Problems where governing equations, residuals or conservation laws can be included during training | Are the constraints scaled correctly against data loss? Are residuals checked independently after inference? |
| Hybrid solver-plus-AI workflows | Flows where a conventional solver can provide corrections, reduced-order steps or final verification | Which stages are safe to approximate, and where must the solver remain in the loop? |
Model selection should be evaluated against physical fidelity, accuracy on unseen geometries and process conditions, inference speed, training-data and labeling cost, uncertainty estimation, integration with existing EDA tools, retraining frequency and hardware requirements.
Build the training data set correctly
Cover the real design envelope
Generate examples across geometry dimensions, layer stacks, materials, temperatures, voltages, loads, process corners and boundary conditions. Include difficult but valid cases: near-threshold operation, thermal hotspots, high-gradient regions, nonlinear transitions and convergence-sensitive points.
A random split can overstate performance if nearly identical geometries appear in both training and test sets. Hold out complete geometries, process corners or operating regimes so the evaluation answers the question engineers actually care about: can the model generalize to a new case?

Store the simulator version, mesh or discretization settings, tolerances, convergence status, units, boundary conditions and material libraries with every example. Without that context, a model may learn artifacts from one setup and fail after a tool, mesh or process-library change.
Balance common and rare cases
Most samples should represent normal operation, but rare failure modes deserve deliberate coverage. If a thermal runaway, electromigration limit or lithography hotspot is safety- or yield-critical, it cannot be left to chance simply because it occupies a small fraction of the design space.
How to enforce and measure physical behavior
- Dimensional checks: Confirm that inputs and outputs use consistent units and that transformations do not erase scale information.
- Boundary-condition tests: Evaluate the model on known boundaries, symmetry planes and limiting cases.
- Conservation checks: Measure charge, energy, mass or other conserved quantities after inference, not only during training.
- Residual monitoring: Calculate the governing-equation residual on held-out cases and record where it grows.
- Uncertainty estimates: Flag predictions that are far from the training distribution or where model ensembles disagree.
- Trend tests: Verify expected monotonic or qualitative behavior, such as temperature increasing with power under a fixed cooling condition.
Report error distributions, worst-case error and error by geometry or process corner. A low average error can hide a small set of unacceptable failures.
Integrate the surrogate with an EDA flow
- Define the interface. Specify input schemas, units, geometry format, mesh assumptions, process-corner identifiers and output fields.
- Wrap inference as a repeatable stage. The model should accept the same structured inputs used by the design flow and return machine-readable outputs with version information.
- Attach validity checks. Reject malformed inputs and flag out-of-distribution cases rather than silently returning a confident number.
- Use active learning. Send uncertain or high-value candidates to the trusted solver, add the results to the data set and retrain on a controlled schedule.
- Keep a solver escape path. Engineers need a simple way to run the conventional simulation whenever a design falls outside the surrogate’s validated domain.
- Version everything. Track model weights, training data, simulator version, physical libraries, hardware and validation reports so results are reproducible.
NVIDIA provides PhysicsNeMo, CUDA-X libraries and GPU platforms for this class of workflow. Synopsys integrates accelerated compute and AI-physics capabilities into PrimeSim, Sentaurus, QuantumATK and SeaScape. NVIDIA’s industry overview also names Cadence and COMSOL for accelerated semiconductor and multiphysics workflows, while Voltai and ChipAgents represent emerging specialist platforms for agentic multiphysics and chip-design AI.

A surrogate that answers in milliseconds can still have a poor total return if generating and labeling the training set takes months, if retraining is frequent, or if every candidate must be rechecked by the conventional solver. The business value appears when the model is reused across enough evaluations and reduces the time to a useful design decision.
Independent reader supportYour contribution helps us test, update, and keep practical guides available for everyone. When a conventional solver is still required
Do not use a surrogate as the sole signoff authority unless the target methodology has been independently qualified for that exact use. Conventional TCAD, SPICE, finite-element and lithography solvers remain necessary when:
- the geometry, material or process condition is outside the validated domain;
- the result is safety-, reliability- or yield-critical;
- nonlinear behavior or discontinuities appear;
- the model reports high uncertainty or violates a physical check;
- the simulator or process library has changed;
- an auditor, customer or design methodology requires a traceable physics solve.
The practical division of labor is broad AI-assisted exploration followed by high-fidelity verification of finalists. If the final solver disagrees materially with the surrogate, treat that disagreement as a data and model diagnostic, not as permission to choose the cheaper answer.

The model is fast but inaccurate on new layouts
Cause: Training data contained many variants of a narrow geometry family but few genuinely different layouts.
Fix: Hold out complete geometry families, add representative new layouts with the trusted solver, and retrain. Consider a graph or operator representation that reflects the changing structure.
Predictions violate conservation or boundary conditions
Cause: Physical constraints were absent, poorly scaled or checked only on training data.
Fix: Add residual and boundary losses, normalize terms carefully, and make post-inference conservation checks part of the deployment gate.
Performance collapses after a process update
Cause: The model learned a previous simulator version, material library or process window.
Best Value
Fix: Treat tool and process changes as triggers for revalidation. Generate a new calibration set and compare old and new models on the same held-out cases.
Training cost outweighs inference savings
Cause: The loop is run too infrequently, or the data set is too expensive to generate.
Fix: Quantify total cost over the model’s expected life. Start with a repeated sweep where thousands of evaluations are realistic, and use active learning to avoid labeling redundant cases.

A practical pilot plan
- Pick one measurable bottleneck. Record current runtime, number of evaluations per project and the accuracy required for a decision.
- Define the process window. List geometry, materials, corners, loads and boundary conditions that the pilot must cover.
- Build a solver-backed data set. Include ordinary, extreme and deliberately held-out cases, with complete metadata.
- Train two baselines. Compare a physics-guided model with a simpler model to determine whether the physical structure improves generalization enough to justify its complexity.
- Set acceptance gates. Specify maximum field, waveform or metric error; conservation tolerance; out-of-distribution behavior; and fallback rules before looking at the results.
- Benchmark end to end. Measure inference, data transfer, orchestration, retraining and final verification, not just a single model call.
- Deploy in shadow mode. Let the surrogate make predictions beside the trusted solver, without affecting signoff, until its error and failure handling are understood.
- Expand gradually. Add new geometries and corners through active learning, and requalify after any simulator, hardware or process change.
How to judge whether the approach is worthwhile
A successful project answers four questions with measured evidence:
- Does it preserve the decision? The surrogate should rank or classify candidates the same way the trusted solver does within the target tolerance.
- Does it reduce total elapsed time? Include data generation, training, deployment and final solver checks.
- Does it integrate with existing tools? Engineers should not have to manually reformat every geometry or reconstruct every boundary condition.
- Can the team detect and recover from failure? A safe system identifies uncertainty, routes exceptions to the solver and records the outcome for retraining.
Synopsys CEO Sassine Ghazi summarized the broader direction this way: “The complexity and cost of developing next-generation intelligent systems demands engineering solutions with a deeper integration of electronics and physics, accelerated by AI capabilities and compute. No two companies are better positioned to deliver AI-powered, holistic system design solutions than Synopsys and NVIDIA. Together we will reengineer engineering and empower innovators everywhere to more efficiently realize their innovations.”

Bottom line for chip-design teams
Use physics-informed AI where the same expensive simulation must be repeated across a large, well-defined design space. Build the model from representative high-fidelity data, encode the relevant physical structure, test on genuinely unseen cases and keep strict solver-based fallback and signoff. Under those conditions, surrogate inference can move exploration from hours toward milliseconds and deliver large workload-specific gains. It should be adopted as a validated accelerator around TCAD, SPICE and multiphysics—not as an unqualified substitute for them.
