When production AI inference slows down, first determine which latency changed, for whom, and in which phase. Split measurements by model, endpoint, tenant or project, service tier, and time window; compare p50 with tail percentiles; then correlate time to first token, token-generation speed, queueing, prefill, decode, cache, memory, workload, and network signals. A focused change should be accepted only when representative traffic meets your application SLO without creating new errors or capacity problems.
Start by defining the slowdown precisely
“The endpoint is slow” is not a diagnosis. Write down the user-visible symptom, the affected population, and a comparison baseline before changing infrastructure or model settings. Use the same model, endpoint, project or tenant, service tier, and traffic window on both sides of the comparison. Compare the current release with the immediately preceding release or an earlier period with a similar request mix.

Capture an evidence window
Choose a window that contains the incident and a matching healthy window. Preserve request-level send and receive timestamps, request IDs, HTTP status, model name, endpoint, service tier, prompt and completion token counts, and retry information where your instrumentation permits it. Synchronize clocks and record the timezone. If the issue is intermittent, retain enough samples to compare the slow tail rather than only a handful of requests.

Segment before aggregating
Filter dashboards and queries by model, endpoint, tenant or project, service tier, region, and time range. A global average can hide a regression affecting one low-volume model or make a localized problem appear universal. Compare an affected slice with an unaffected slice using equivalent traffic. Hosted APIs may expose fewer internal dimensions, so keep application-side labels and request IDs even when provider dashboards are available.

Use percentiles and separate the latency measures
Plot p50 and at least p95 for every important latency measure; p90 and p99 are useful when your SLO or traffic volume makes those tails actionable. Average latency is not a safe proxy for user experience. As the OpenAI Help Center puts it in its API troubleshooting documentation: “Always review P50 / P75 / P95 percentiles. Averages can hide real-user impact.” Track errors as a percentage of requests, not only as a raw count, because a rising request volume can make a stable error count look better than it is.
Time to first token (TTFT)
TTFT is the elapsed time from request acceptance to the first generated token. It is especially sensitive to input prompt size, queueing, prefill work, and any reasoning performed before generation. A conversational application can feel broken even when total completion time is unchanged if TTFT rises.
Inter-token latency and token velocity
Inter-token latency (ITL), sometimes reported as token velocity or generation rate, describes the spacing between generated tokens after the first token. A worsening ITL usually points toward decode throughput, output length, GPU health, memory pressure, or contention. Confirm the backend’s definition: metric names and calculation windows differ among serving systems.

End-to-end request duration
End-to-end duration runs from the client request through the final response and downstream handling. It can increase because a model generates more tokens even when TTFT is stable. Measure network transfer and client parsing separately when possible so model execution is not blamed for downstream delays.
Metric names vary by serving backend and deployed version. Confirm definitions before copying a dashboard query into a runbook. NVIDIA’s AIPerf Server Metrics Reference identifies version 0.13.0 as the latest documentation version in the cited material and maps backend-specific measures for TTFT, ITL, queue time, and end-to-end latency.

Locate the changed phase: queue, prefill, or decode
For vLLM-oriented analysis, NVIDIA’s AIPerf reference represents end-to-end time as queue plus prefill plus decode. These labels are diagnostic aids, not universal names or proof of a single root cause.
Queue time
Queue time is the wait for GPU or serving capacity before work begins. If it rises with pending or waiting requests, inspect offered load, admission limits, concurrency, autoscaling lag, and available capacity. More than one resource can be constrained, so verify the conclusion with memory, throughput, and GPU health signals.
The Tool Desk
Outbyte PC Repair FREERepair Windows errors before they cause bigger problemsFix Now →Outbyte Driver Updater FREEFix the driver behind crashes, sound loss and screen glitchesFind Drivers →Prefill time
Prefill processes the input tokens. A TTFT increase with stable queue time shifts attention to prompt-length distribution, input processing, cache state, model or backend changes, and reasoning behavior. Compare prompt-token percentiles, not merely the average; a small population of very long prompts can dominate the tail.
Decode time
Decode generates output tokens. If ITL worsens or end-to-end time grows after a normal first token, compare output-token distributions, generation throughput, GPU health, memory pressure, and competing workloads. A longer completion can legitimately increase total duration, so hold output-length distribution constant when testing a serving change.
Some hosted APIs do not expose queue, prefill, and decode internals. In that case, infer the phase from TTFT, ITL, token counts, request timestamps, and any provider usage or status data, while treating the inference as provisional.

Check capacity, memory, and concurrency together
Do not interpret a single utilization gauge in isolation. High GPU utilization can mean efficient saturation, queueing caused by insufficient capacity, or a healthy workload with no latency violation. Correlate the following curves over the same time range:
What’s actually slowing this PC down?
Pick the symptom - the matching free tool is one click away.
- Pending and waiting requests, queue-time percentiles, and admission rejections.
- Running requests and effective concurrency.
- Requests per second, input and output tokens per second, and batch sizes where available.
- KV-cache usage, cache misses, preemptions, and allocation failures.
- GPU memory, compute utilization, temperature, clocks, health events, and device resets.
- Autoscaler decisions, replica count, warm-up time, and load-balancer distribution.
In the AIPerf reference’s vLLM interpretation, growing waiting requests indicate queue build-up, KV-cache usage above 0.9 indicates near-full cache capacity, and preemptions indicate memory pressure. Those are backend-specific documented interpretations, not universal thresholds for every inference server. Validate them against your deployed version and observe whether the same signals move with latency.
When concurrency is the trigger
A concurrency limit can protect a service from collapse but also create visible queueing when traffic rises. Compare offered concurrency with admitted and running concurrency. Check whether a client, gateway, or provider tier changed its limit. If autoscaling is involved, measure the delay from load increase to a ready replica; a nominally adequate final replica count does not prevent latency during the ramp.
When memory pressure is the trigger
Look for KV-cache exhaustion, preemptions, allocation failures, swapping, or repeated batch reductions. Memory pressure can increase queueing and reduce decode speed at the same time. Confirm that a change in quantization, context length, parallelism, or model revision did not alter per-request memory requirements.
Compare the request mix, not just request volume
Two periods with the same requests per second can have very different latency if their token and concurrency distributions differ. Track prompt length, output length, concurrent requests, requests per second, model and precision, cache state, and reasoning settings.

- Longer prompts generally raise TTFT and prefill work.
- Longer generations increase decode work and end-to-end duration.
- Higher concurrency raises contention and can increase queue time even when average token counts are unchanged.
- Cache hits and misses can change both prefill cost and memory use.
- Changing model precision or serving parallelism alters throughput and capacity requirements.
Compare distributions and percentiles for prompt and output tokens. A small number of tail-sized requests can create a tail-latency incident while averages remain normal. Amazon Web Services’ Prescriptive Guidance states: “Two deployments serving the same model can require significantly different infrastructure depending on factors such as prompt length, response length, concurrency, and latency objectives.” Treat that as a sizing principle, not a promise of a particular performance level.
Rule out client, proxy, and network delays
If application timeouts or errors rise without matching provider-side request records, the request may be failing before it reaches the inference service. Inspect client deadlines, proxy and load-balancer idle timeouts, connection pools, DNS, TLS setup, retries, circuit breakers, and regional routing. Compare client send time, provider acceptance time when available, first-byte time, and final-byte time.
Keep request IDs and synchronized timestamps for support cases. HTTP status observed by a provider can differ from the status recorded by your application; the OpenAI troubleshooting guidance notes that a provider-side 499 can appear as a 5xx in a customer’s systems. Do not classify every application 5xx as model failure without checking arrival evidence.
Streaming-specific checks
- Measure time to first byte separately from TTFT if the client or proxy buffers streamed data.
- Check whether compression, response buffering, or a gateway’s minimum chunk size delays visible tokens.
- Compare server generation time with client rendering and downstream processing time.
Use symptoms to choose the first investigation
| Observation | First checks | Interpretation limits |
|---|---|---|
| TTFT and queue time rise; waiting requests grow | Offered load, admission and concurrency, backend capacity, autoscaling lag, KV-cache pressure | Queueing suggests contention, but multiple resources may be involved. |
| TTFT rises while queue remains stable | Prompt-token distribution, prefill, cache state, model or backend changes, reasoning settings | Hosted APIs may not expose all phase internals. |
| ITL or token velocity worsens | Decode time, output lengths, generation throughput, GPU health and memory, competing work | Compare equivalent traffic and identical serving-stack versions. |
| End-to-end time rises while first token is stable | Output-token count, decode time, downstream response handling, network transfer | Longer output alone can increase request duration. |
| Application timeouts rise but provider health shows no matching errors | Client or proxy timeout, load balancer, network path, request-arrival evidence | Requests may fail before reaching the provider. |
| One model, tier, tenant, project, or endpoint is affected | Filter to that dimension and compare unaffected traffic | Aggregated dashboards can conceal a localized issue. |
Test one targeted change under representative load
After identifying a likely bottleneck, change one relevant variable and test it against traffic that resembles production. A short single-request test can show that a configuration works while missing queueing, cache churn, long prompts, or tail-sized completions.
Build a controlled comparison
- Freeze the model artifact, backend and software versions, hardware allocation, prompt distribution, output distribution, concurrency, and cache conditions.
- Replay or generate a workload with representative prompt and completion-token percentiles, arrival rate, burstiness, and tenant mix.
- Measure p50, p95, and p99 TTFT, ITL, end-to-end duration, throughput, concurrency, queue time, and error rate.
- Apply one targeted change, such as a capacity adjustment, concurrency limit, batching setting, cache policy, or routing correction.
- Repeat the same workload long enough to include warm-up, steady state, and any autoscaling transition.
- Accept the change only if the application SLO improves without unacceptable error, cost, throughput, or fairness regressions.
Scaling, batching, GPU allocation, and serving-architecture changes can improve one metric while worsening another. Select the configuration that meets the product’s latency and reliability objectives, not a generic target copied from another workload.
Best Value
Keep a rollback and evidence trail
- Record the exact configuration, software and hardware versions, traffic profile, cache state, and test duration.
- Define the rollback condition before the test, including tail latency, timeout rate, and error-rate limits.
- Watch for delayed effects such as cache warming, replica churn, memory fragmentation, and autoscaler oscillation.
- Compare the affected slice and an unaffected control slice when possible.
Set an SLO instead of borrowing a universal latency number
There is no generally established cross-platform production latency threshold in the cited guidance. Define objectives from the product experience, request mix, and error budget. A chat interface may prioritize TTFT and ITL; a batch workflow may prioritize completion throughput and total duration.
AWS right-sizing guidance gives an illustrative workload target of TTFT below 1 second, end-to-end latency below 5 seconds, and queueing delay below 500 milliseconds. These are example inputs for sizing, not measured results or universal SLOs. Do not present them as a guarantee for your model, region, tier, or serving stack.
Write the SLO in measurable terms
- Specify the population: model, endpoint, region, tenant or project, and service tier.
- Specify the percentile and time window, such as p95 TTFT over five minutes.
- Set separate objectives for TTFT, ITL or token velocity, end-to-end duration, and error rate when users experience them differently.
- State the traffic assumptions: prompt and output-token distributions, concurrency, cache state, and streaming behavior.
Platform-specific caveats that prevent bad conclusions
Hosted API health dashboards
The OpenAI Service Health dashboard described in the cited guidance is available to Enterprise API customers. Do not assume every account can see it. Other users can still use application timestamps, request IDs, usage data, provider status information where available, and support channels with a precise evidence window.
Service tiers
Compare service tiers separately. Standard service can show wider latency variation and is not described in the cited OpenAI article as having guaranteed latency. Do not extrapolate a result from one tier to another; use the applicable service terms and your own SLO measurements.
AIPerf and backend versioning
NVIDIA AIPerf metric names and meanings are backend- and version-specific. Verify the deployed version before copying names, thresholds, or formulas into alerts. The reference’s queue, prefill, decode, KV-cache, and preemption interpretations should be treated as guidance for the documented backend, not as a universal taxonomy.
GPU sharing
NVIDIA’s Inference Reference Architecture advises caution with time-sliced GPU sharing for latency-sensitive large-language-model serving unless validation supports it. Shared devices can introduce interference, but the architecture note is not proof that sharing caused a particular incident and is not a blanket instruction to replace hardware.
Common troubleshooting mistakes
- Chasing average latency: a normal mean can coexist with a severe p95 or p99 regression.
- Pooling unlike traffic: mixing models, tiers, tenants, prompt sizes, or regions can erase the affected slice.
- Calling high GPU utilization the root cause: utilization must be correlated with queueing, memory, throughput, and health.
- Ignoring token counts: longer prompts and completions change latency even when infrastructure is unchanged.
- Changing several variables at once: you lose causal evidence and make rollback ambiguous.
- Testing only one request: single-request results do not expose contention, cache churn, bursts, or autoscaling lag.
- Assuming provider dashboards cover the whole path: client, proxy, load balancer, and network failures can occur before provider acceptance.
- Copying thresholds across backends: metric definitions and queue or cache limits depend on the serving system and version.
A compact incident runbook
- Name the degraded measure and baseline period.
- Filter by model, endpoint, tenant or project, tier, region, and time range.
- Plot p50, p95, and p99 TTFT, ITL, end-to-end duration, and error proportion.
- Compare prompt and output-token distributions, concurrency, requests per second, and cache state.
- Correlate queue, prefill, decode, waiting requests, running requests, KV-cache use, preemptions, GPU memory, and health.
- Check client, proxy, load-balancer, network, timeout, retry, and request-arrival evidence.
- Form one phase-specific hypothesis and change one variable.
- Validate with representative traffic while holding versions, hardware, workload, and cache conditions constant.
- Keep the change only when the relevant SLO and error budget improve.
This sequence turns “the endpoint is slow” into a bounded question: which slice regressed, which latency component moved, what resource or path signal moved with it, and did a controlled change restore the service objective?
