How to Train Agents on Long-Horizon Tasks With Reinforcement Learning

To train an agent on a long-horizon task, make the task’s temporal structure explicit: define useful intermediate goals, let a high-level policy choose them, train a lower-level policy to execute them, and preserve learning signals for partial progress instead of waiting only for the final reward. Then verify that proposed subgoals are reachable and evaluate both intermediate behavior and final success.

This approach is not a universal algorithm. A flat policy can be adequate when rewards are frequent and horizons are short; hierarchy, milestone-based credit, demonstrations, or feasibility checks become more valuable as decisions become numerous, dependent, and sparsely rewarded.

Why long-horizon reinforcement learning is difficult

A long-horizon task requires a chain of decisions before the environment reveals whether the attempt succeeded. If the agent receives a reward only at termination, exploration becomes expensive: most trajectories fail, and the agent cannot easily tell which earlier choices were useful.

Credit assignment is the second problem. An episode that ends unsuccessfully may contain several correct actions followed by one bad decision. A terminal penalty can therefore make the policy reduce behavior that was actually helping. The authors of the ICML 2026 BEACON paper describe these causes as “credit misattribution, where correct early actions are penalized due to terminal failures, and sample inefficiency, where scarce successful trajectories result in near-total loss of learning signal.”

Before changing the algorithm, determine whether the task is genuinely long-horizon. A 100-step episode with dense, informative feedback may be easier than a 20-step episode whose only reward arrives at the end. The important variables are the number of dependent decisions, reward delay, failure cost, and whether meaningful intermediate states can be recognized.

Specify the task and its feedback before choosing an algorithm

Write down the training interface in a form that makes missing information obvious. Include:

  • Observation: what the agent can see at each decision, including memory available across turns.
  • Actions: primitive controls, tool calls, language actions, or high-level commands.
  • Termination: success, failure, timeout, or interruption conditions.
  • Reward timing: which events produce feedback and how long the delay can be.
  • Intermediate states: observable facts that indicate real progress toward the task.
  • Constraints: actions that are invalid, irreversible, unsafe, or too costly to explore.

Keep the environment’s objective separate from any training convenience. If the environment supplies a verified milestone, it can be treated as task feedback. If you invent a milestone or shaped reward, it is a proxy: the agent may optimize the proxy while failing the actual objective.

Use temporal abstraction when the task has meaningful subgoals

The standard hierarchical pattern has two policies. A high-level policy selects a goal or subgoal, and a low-level policy chooses primitive actions until that goal is completed, abandoned, or the episode ends. The high level therefore makes fewer, temporally extended decisions; the low level learns execution.

High-level goal selection

The high-level controller should choose goals that change what the agent should do next, not merely restate the final objective. For a multi-step manipulation task, “place the part on the inspection surface” is more useful than “finish assembly.” For a language agent, a persistent subgoal might be to gather a required fact before composing the final response.

Low-level execution

The executor needs a clear completion test and a bounded opportunity to act. Define what counts as success, how many primitive actions are allowed, and what happens after failure. Without these rules, the high-level policy receives ambiguous outcomes and cannot learn whether a poor result came from selecting the wrong goal or executing a good goal badly.

Switching between levels

Switching should be an explicit event recorded in the trajectory. A controller can switch when the subgoal is achieved, when progress stalls, when a constraint is violated, or when a maximum step budget expires. In language-agent settings, HiPER maintains subgoals over multiple turns and explicitly decides when to switch. Its authors describe this as converting implicit multi-turn structure into learnable decisions at different time scales.

Hierarchy is an architectural choice, not a guaranteed performance improvement. It adds interfaces that must be designed and learned: goal semantics, completion detection, timeout handling, and recovery after execution failure.

Preserve credit for partial progress

Milestone segmentation and temporal shaping

BEACON, an ICML 2026 method for long-horizon language agents, splits trajectories at milestones, shapes rewards within each segment, and estimates advantages at two scales. The practical idea is to let the policy learn from progress between milestones instead of assigning the entire outcome to a distant terminal event.

To apply this pattern, define milestones that are observable and causally useful. Record when each milestone is first reached, calculate segment-level outcomes, and retain the terminal objective as the final authority. Monitor for reward hacking: an agent may learn to trigger a milestone without completing the task it is intended to represent.

Hierarchical advantage estimation

HiPER uses Hierarchical Advantage Estimation to assign credit both to primitive action execution and to transitions between subgoals. This separates two questions: did the executor carry out the selected subgoal, and was selecting that subgoal useful at the broader task level?

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

These methods share a motivation but are not interchangeable recipes. Milestone segmentation, shaped rewards, and multi-scale advantages require different definitions and can behave differently when milestones are noisy or optional.

Do not treat shaped rewards as ground truth

An intermediate reward is authoritative only when it comes from the environment’s specification. Practitioner-designed shaping should be tested against the real success metric. Useful checks include whether an agent can obtain high shaped return while failing the task, whether removing a milestone changes behavior unexpectedly, and whether the shaping signal remains valid when the agent finds a novel route.

Make exploration goal-aware and test feasibility

High-level exploration can be more efficient than selecting primitive actions randomly, but a hierarchy does not solve exploration by itself. If the agent repeatedly proposes impossible goals, the lower-level policy receives confusing failures and the high-level policy may learn the wrong lesson.

Intrinsic goals and h-DQN

The NeurIPS 2016 h-DQN architecture combines a top-level policy over intrinsic goals with a lower-level policy over atomic actions. It was motivated by sparse and delayed feedback, including the exploration difficulty illustrated by Montezuma’s Revenge. The separation lets the high level explore what to accomplish while the controller learns how to accomplish it.

Reliable subgoal execution

The ICLR 2026 work on Strict Subgoal Execution addresses the complementary problem of unreliable goals. It describes frontier experience replay to distinguish unreachable from admissible subgoals, decoupled exploration in goal space, and path refinement based on low-level failures.

In an implementation, maintain separate records for:

  • the proposed goal and the state in which it was proposed;
  • whether the goal was reachable under the current policy and budget;
  • the execution path and the first failure point;
  • whether failure reflected an invalid goal, inadequate skill, or insufficient exploration.

Goal discovery and goal execution are separate learning problems. Improve them independently rather than assuming that a stronger executor will discover better goals, or that a better planner can compensate for an unreliable executor.

Use demonstrations when they solve a real information problem

Demonstrations can bootstrap low-level skills, show which subgoals are sensible, or provide trajectories through states that random exploration rarely reaches. The ICML 2018 work on hierarchical imitation and reinforcement learning combines expert feedback, imitation, and reinforcement learning at different hierarchical levels for sparse-reward sequential decisions, with long-horizon benchmark evidence including Montezuma’s Revenge.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Expert data is optional, not a prerequisite. Its value depends on coverage and quality:

  • Use demonstrations for skills the environment makes expensive to discover.
  • Use higher-level demonstrations when the main difficulty is sequencing, not motor execution.
  • Keep reinforcement learning active so the agent can improve beyond imperfect demonstrations.
  • Measure whether the policy copies an expert’s route unnecessarily instead of learning the underlying goal.

The amount of expert data, its annotation level, and its reliability are domain-dependent. Do not assume that a small number of demonstrations will cover every subgoal or failure mode.

A practical training procedure

  1. Define the terminal objective. Specify exactly what counts as success, failure, and timeout. Keep this metric unchanged while experimenting with shaping.
  2. Measure the horizon and reward delay. Log episode length, number of decisions, distance between informative events, and the proportion of episodes with no nonzero reward.
  3. List candidate milestones or subgoals. Prefer observable states that unlock later actions, satisfy a real constraint, or represent verifiable progress.
  4. Choose the control structure. Use a flat policy for short, well-instrumented tasks; add a high-level selector and executor when temporal abstraction reduces the decision burden.
  5. Define subgoal contracts. For every goal, specify a completion test, action budget, failure signal, and switching rule.
  6. Instrument every transition. Store the selected goal, primitive actions, milestone events, completion status, failure reason, and terminal outcome.
  7. Start with the least aggressive credit intervention. Add verified milestone rewards first. If the terminal signal still overwhelms learning, test segment-level shaping or a multi-scale advantage estimator.
  8. Train exploration separately from execution. Add intrinsic goals or goal-space exploration, then test whether the executor can reliably reach the goals it is given.
  9. Add demonstrations selectively. Initialize skills or high-level choices from expert trajectories only where environment-only exploration is demonstrably inefficient.
  10. Validate against the unchanged task objective. Compare final success with intermediate completion, episode length, failure categories, and sample use.

Minimal logging and pseudocode structure

A useful trajectory record preserves both levels of behavior. The following is a conceptual template rather than a prescription for a particular framework:

for episode in environment:
    state = reset()
    while not terminal(state):
        goal = high_level_policy(state, history)
        goal_start = state
        for step in range(goal_budget):
            action = low_level_policy(state, goal)
            next_state, reward, done, info = environment.step(action)
            log(state, goal, action, next_state, reward, info)
            state = next_state
            if info["milestone"]:
                record_milestone(info["milestone"])
            if done or info["goal_complete"] or info["goal_failed"]:
                break
        assign_low_level_credit(goal_start, state)
        assign_high_level_credit(goal, terminal_outcome, milestones)

The important properties are observability and separate credit paths. The exact optimizer, replay design, and policy class depend on the environment and are not fixed by the hierarchy itself.

Compare the main method families

Method or family Core mechanism Best fit Primary limitation to check
Flat policy with task reward One policy maps observations directly to primitive actions Short horizons or dense feedback Terminal-only feedback can make exploration and credit assignment impractical
h-DQN (NeurIPS 2016) Top-level intrinsic-goal policy plus lower-level atomic-action policy Sparse-reward control with meaningful goals Goal definitions and reachability determine whether hierarchy helps
Hierarchical imitation and RL (ICML 2018) Expert feedback, imitation, and RL at different levels Tasks with useful demonstrations and sparse sequential rewards Data quality and coverage are domain-dependent
BEACON (ICML 2026) Milestone segmentation, within-segment shaping, dual-scale advantages Long-horizon language-agent trajectories with recognizable milestones Designed milestones can become exploitable proxies
HiPER (ICML 2026) Persistent subgoals, explicit switching, Hierarchical Advantage Estimation Multi-turn language agents with subgoal structure Requires reliable subgoal semantics and switching decisions
Strict Subgoal Execution (ICLR 2026) Frontier experience replay, decoupled goal exploration, path refinement Tasks where proposed goals are often infeasible or execution is unreliable The abstract reports qualitative results; no general success rate is established here

Choose among these families using six questions: can useful subgoals be specified or learned; are demonstrations available; how severe is sparse feedback; is feasibility checked; can methods be compared under matched budgets; and is the target a conventional control policy or a multi-turn language agent?

What recent benchmark results do—and do not—show

The ICML 2026 BEACON paper reports 92.9% success on its long-horizon ALFWorld evaluation, compared with 53.5% for GRPO, and effective sample utilization of 82.0% versus 23.7%. HiPER reports 97.4% on ALFWorld and 83.3% on WebShop; its paper describes the ALFWorld result as 6.6 percentage points above the best prior method.

These are study-specific claims from the respective official proceedings abstracts, not independently reproduced results or universal expectations. The papers use different methods, setups, and evaluation details, so their percentages must not be merged into a common leaderboard. Results can also change in practical relevance as implementations and replications appear. Consult the full papers for equations, hyperparameters, seeds, and exact protocols.

Common failure modes and fixes

The agent receives almost no useful signal

Check whether the task has any verified intermediate state. If it does, expose that event as a milestone or subgoal outcome. If it does not, consider demonstrations, intrinsic goals, or a redesigned task interface rather than inventing arbitrary rewards.

The agent reaches milestones but fails the task

The milestone is probably incomplete, weakly related to success, or easy to exploit. Tighten its completion test, keep terminal success dominant, and inspect trajectories that maximize shaped return without finishing.

The planner proposes impossible goals

Separate invalidity from execution weakness. Record failed goals, use reachability-aware replay or goal-space exploration, and allow the high-level policy to learn that some goals are inadmissible under the current state and action budget.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

The executor cannot complete valid goals

Increase low-level training coverage, provide demonstrations for the missing skill, or adjust the action budget. Do not blame the high-level policy until the executor’s success rate on fixed, known goals is measured.

Switching happens too early or too late

Log every switch and compare it with milestone and failure events. Add explicit completion, stall, and timeout conditions; otherwise the high-level policy may receive inconsistent credit for the same behavior.

Training improves shaped reward but not success

Audit the reward decomposition, remove or revise the exploitable component, and select checkpoints by terminal success rather than shaped return alone.

Decision guide

  • Use a flat policy when feedback is frequent, the horizon is modest, and there is no stable notion of a subgoal.
  • Add hierarchy when the task naturally decomposes into goals that persist for several actions or turns.
  • Add milestone or segment credit when terminal outcomes obscure recognizable partial progress.
  • Add feasibility-aware exploration when high-level proposals are often unreachable or low-level failures are ambiguous.
  • Add imitation when demonstrations provide state coverage or sequencing information that random interaction cannot obtain affordably.
  • Keep the design simpler when added levels create more completion and switching ambiguity than they remove.

The central design principle is to expose the task’s time structure without replacing the real objective. High-level decisions should select useful, reachable goals; low-level policies should execute them reliably; and credit should preserve evidence of partial progress while remaining tied to final success.
