Compare the model’s performance on the data used for training with its performance on representative data it never saw during fitting. Poor results on both sets usually indicate underfitting. Strong training results combined with substantially worse held-out results indicate overfitting. Use the same task-appropriate metric for both sets, inspect how the scores change during training, and verify that your evaluation split resembles the cases the model will meet in production.
What the two failure modes mean
“Fit” describes how well a model captures useful relationships in data. The important question is not whether a model can reproduce its training examples, but whether it can make reliable predictions for new examples drawn from the same intended use.

Underfitting: the model cannot explain even its training data
An underfit model performs poorly on the training set and also performs poorly on held-out data. Its representation may be too limited for the relationship you need to learn, its features may omit important signals, its regularization may be too strong, or training may not have gone far enough. AWS describes this pattern as poor performance on both training and evaluation data and lists model capacity, features, regularization, and training as areas to investigate. Read the full discussion in AWS’s model-fit guidance.

Overfitting: the model memorizes details that do not generalize
An overfit model performs very well on examples used for fitting but noticeably worse on new or held-out examples. It may have learned quirks, noise, or sampling artifacts that happen to occur in the training set rather than a relationship that persists. Google summarizes the pattern this way: “An overfit model makes excellent predictions on the training set but poor predictions on new data.” See Google’s explanation of overfitting.

Good fit: strong results with a credible gap
When training and held-out performance are both good and reasonably close, the model may be generalizing well. That conclusion is conditional: the held-out data must represent the intended deployment population, the labels and metric must reflect the real objective, and the held-out set must not have influenced model selection.
Start with an evaluation you can trust
A diagnosis is only as useful as the comparison behind it. Before changing the model, make sure the measurements answer the question you actually care about.
Choose a metric that matches the task
Use a measure that reflects the prediction task and the cost of errors. Accuracy can be suitable for some classification problems, while other tasks require a different score. The sources do not identify one universal metric; instead, they recommend choosing a task-appropriate measure and applying the same measure to training and held-out data. A score that does not represent the business or scientific objective can make a model look better or worse without changing its practical value.

The training set is used to estimate model parameters. A validation set can guide choices such as hyperparameters, feature sets, training duration, or regularization. A separate test set should provide the final estimate of generalization after those choices are complete. If you repeatedly inspect a validation score and use it to select settings, that validation data has become part of the model-selection process; it is no longer an unbiased final estimate. The distinction is explained in scikit-learn’s validation-curve and learning-curve documentation and in AWS’s model-evaluation guidance.
Make the held-out data resemble intended use
Google identifies independent examples, a sufficiently stationary data-generating process, and similar distributions across partitions as conditions that support generalization. If the evaluation set differs materially from deployment cases, a high score can fail to predict real-world performance and a low score can exaggerate the apparent problem. Inspect how examples were collected, when they were collected, and which groups or environments they represent before labeling a model underfit or overfit.

Respect time, groups, and other dependencies
A random split is not automatically valid. Records from the same person, device, transaction, site, or event can be related; future observations can also depend on past observations. Put related observations in the same partition or use a time-aware design when that matches deployment. Otherwise, information can leak across partitions and make held-out performance look stronger than it will be in use. AWS’s cross-validation overview describes rotating held-out folds and emphasizes evaluation design as a way to detect overfitting.
A step-by-step diagnosis
1. Record training and held-out performance
After fitting, calculate the selected metric on the training data and on representative data that was not used to fit the model. Keep the evaluation protocol identical: use the same preprocessing rules, label definitions, metric implementation, and reporting convention. Record the model version and data split so that later changes can be compared fairly.

| Training result | Held-out result | Likely interpretation |
|---|---|---|
| Poor | Poor | Underfitting is likely; investigate capacity, features, regularization, data quality, and training. |
| Strong | Substantially worse | Overfitting is likely; investigate flexibility, feature selection, regularization, leakage, and representativeness. |
| Strong | Strong and reasonably close | The model may be fitting well if the split and metric represent intended use. |
These are diagnostic clues, not automatic proof. Before acting, check the labels, metric, partitioning process, and data-collection conditions. A split contaminated by duplicates or related records can hide overfitting; a distribution shift can look like overfitting even when the model learned the original population correctly.
3. Plot the training and validation history
Save loss or an appropriate score at regular training steps or epochs for both the training and validation sets. A typical overfitting signal is training loss that continues to fall while validation loss begins to rise. Google calls this “problematic overfitting” and describes the same pattern in its scientific approach to improving model performance.
A single loss curve shows how one dataset behaves over iterations. Plotting training and validation curves together reveals the generalization gap and when it develops. If both curves improve in a similar shape, the model is behaving more consistently across the two sets. Similar shapes do not guarantee deployment success; they simply provide stronger evidence than a training curve alone.

4. Identify when the best checkpoint occurred
If validation performance improves and then deteriorates while training performance continues to improve, the later checkpoints are fitting the training sample more closely without improving generalization. The best checkpoint is the one selected using the validation objective and a rule decided in advance, such as the lowest validation loss or the highest validation score. Once the checkpoint and all other choices are fixed, measure it once on the untouched test set.

5. Use a validation curve to test a hyperparameter
A validation curve varies one hyperparameter and plots training and validation scores for each setting. It can reveal a region where the model is too constrained, a region where it begins to overfit, and a setting that balances the two. For example, you might vary a regularization strength or a capacity-related setting while keeping the split and training procedure fixed. The resulting validation score is useful for selection, but repeated use means the validation set remains part of model selection rather than final certification.
6. Use a learning curve to test whether more data could help
A learning curve varies the amount of training data and plots training and validation performance at each size. It shows whether the scores are still changing as examples are added and whether the training and validation curves converge or remain separated. This helps distinguish a data shortage from a capacity or feature problem. Scikit-learn notes that additional data help when the underlying function is too complex to approximate with a lower-variance estimator; more examples are not a guaranteed cure for every weak model.
7. Repeat the estimate with an appropriate cross-validation design
In k-fold cross-validation, divide the available development data into folds, train on all but one fold, evaluate on the held-out fold, and repeat until each fold has served as the holdout. Aggregate the fold results to examine variability rather than relying on one arbitrary split. Choose folds that respect time order, groups, or other dependencies when those structures exist. Cross-validation can strengthen the diagnosis, but it does not remove the need for a separate final test set when you have used the folds to make repeated modeling decisions.
How to read the curves in detail
Training and validation losses separate as training continues
When training loss keeps decreasing but validation loss turns upward, the model is learning patterns specific to the training sample. The widening separation is evidence of overfitting, especially when the validation data are independent and representative. The practical question is where the validation curve reached its best point, not how low the final training loss became.

Both losses remain high and move together
High, similarly shaped training and validation losses are consistent with underfitting or insufficient training. Check whether the model has enough capacity to represent the relationship, whether useful features are available, whether regularization is suppressing needed flexibility, and whether optimization has been allowed to converge. Also verify that the target and metric are defined correctly; a broken label pipeline can make every model appear underfit.
The curves look good, but deployment results are poor
This pattern directs attention to the evaluation design rather than immediately to model capacity. Compare the deployment population with the held-out population, look for changes over time, and check whether preprocessing or label construction differs between evaluation and use. A representative held-out score estimates performance only under conditions similar to those represented by that holdout.
The validation curve is noisy or inconsistent
Large differences between folds or unstable scores across splits can indicate limited data, heterogeneous subgroups, or a split that ignores dependencies. Report the variation, inspect the examples in each partition, and choose a resampling design that matches how predictions will be made. Do not treat the best-looking split as proof that the model is reliable.

| Observed pattern | Investigations and possible changes |
|---|---|
| Poor training and held-out performance | Check feature quality and data labels; consider more expressive capacity, domain-specific features, less regularization, or additional training. |
| Strong training performance and much weaker held-out performance | Check representativeness and leakage; consider reducing flexibility, selecting fewer features, increasing regularization, or obtaining more representative data. |
| Validation loss rises during training | Select an earlier checkpoint or test regularization changes, then evaluate the selected model on data not used for those decisions. |
| Both scores are weak and more data are being considered | Inspect a learning curve first. More examples may help a high-variance pattern, but they will not automatically fix an inadequate representation or an evaluation mismatch. |
Remedies for underfitting
- Increase useful capacity. Test a model family or configuration capable of representing the relationship, while keeping the evaluation design fixed.
- Improve the input representation. Add features grounded in the domain and verify that they are available at prediction time. AWS lists domain-specific features as one possible way to increase flexibility.
- Review regularization. Excessive regularization can constrain the model so much that it cannot capture relevant structure. Reduce it cautiously and compare both training and held-out results.
- Check the training procedure. Confirm that optimization has run sufficiently, inputs are processed as intended, and labels are aligned with examples.
Remedies for overfitting
- Reduce unnecessary flexibility. Simplify the model or constrain its capacity so it has fewer opportunities to memorize sample-specific details.
- Select features deliberately. Remove features that add noise or encode accidental properties of the training sample. Refit and compare on held-out data.
- Increase regularization. Test a stronger penalty or another regularization technique while monitoring the validation curve.
- Use more representative data. Additional examples are most valuable when they cover the conditions and subgroups expected at deployment, not merely when they duplicate the existing sample.
- Stop at the right point. If validation loss begins increasing, retain the earlier checkpoint selected from validation data and reserve the test set for the final estimate.
Do not apply several changes at once without a record
Each adjustment changes what you can learn from the comparison. Keep the split, metric, preprocessing, and reporting fixed where possible; change one major factor at a time; and log the rationale and result. Otherwise, an apparent improvement may come from a different partition, a metric change, or accidental leakage rather than from the intended remedy.
Common traps that produce a false diagnosis
Using training performance as the only score
A model can achieve an excellent training score by memorizing examples. Without a credible held-out comparison, you cannot tell whether that score will carry to new cases.
Best Value
Treating a repeatedly tuned validation score as final
Every inspection used to choose a hyperparameter, feature, architecture, or checkpoint gives the validation set influence over the model-selection process. Keep a separate test set untouched until the decisions are complete, as recommended in the scikit-learn validation guidance.
Letting preprocessing leak information
Fit transformations such as scaling, imputation, vocabulary construction, or feature selection using training data within each split. Applying information computed from the full dataset can transfer held-out details into training and inflate the apparent score.
Assuming a random split fits every problem
Random partitioning can place near-duplicates, records from one entity, or future information in both training and evaluation. Use grouped or time-respecting partitions when those dependencies reflect deployment.
Changing the metric after seeing the result
Choose the primary metric before comparing models. If you change it after observing scores, you can select a model that looks favorable under a measure unrelated to the real cost of errors.
Calling every generalization failure “overfitting”
A model that performs well on one historical sample but poorly after a population or process change may be facing distribution shift. Check stationarity and partition similarity before concluding that the model simply has excessive flexibility.
Quick Recap
A compact interpretation workflow
- Define the prediction task, deployment population, and error-sensitive metric.
- Create training, validation, and final test partitions that respect time, groups, and other dependencies.
- Fit the model using training data only and calculate the chosen metric on training and held-out data.
- Classify the first pattern: both poor, training strong with held-out poor, or both strong and close.
- Plot training and validation histories to locate a widening gap or a validation turning point.
- Use validation curves to examine hyperparameters and learning curves to examine the value of more data.
- Use cross-validation when a single split is too unstable, preserving the structure of the deployment problem.
- Apply a remedy that targets the observed cause, keep a record of the change, and repeat the same evaluation.
- After model selection is complete, run the chosen model once on the untouched test set and report the result with the split conditions.
Final checklist before you label a model
- The training and held-out scores use the same, task-appropriate metric.
- The held-out examples were not used to fit parameters or repeatedly choose settings.
- The split reflects the time, groups, environments, and population expected in use.
- Preprocessing and feature selection were fitted inside the training portion of each split.
- You inspected curves, not only one final score.
- You distinguished validation-curve tuning from learning-curve analysis.
- You investigated labels, data quality, leakage, and distribution changes before changing model capacity.
- You reserved a separate test set for the final generalization estimate.
