How to speed up local LLM inference on an integrated GPU

The fastest route is to measure the right bottleneck, confirm that your runtime is actually using the integrated GPU, then reduce memory and workload pressure one change at a time. There is no universal iGPU setting: the exact GPU, shared-memory system, driver, model and quantization, backend, context, and prompt/output pattern determine whether a change helps.

  • Record time to first token, prompt-processing speed, generation tokens per second, and peak memory.
  • Verify the selected backend and device instead of assuming GPU acceleration is active.
  • Test a context length and model that fit the task and available memory.
  • Benchmark single-user latency separately from concurrent-request throughput.

Start with a controlled baseline

“Integrated GPU” describes how the graphics processor is packaged, not how fast it will run a language model. An integrated GPU may share system memory with the CPU, use a different memory bandwidth, expose different acceleration APIs, and behave very differently from another iGPU in the same product family. Driver version, operating-system scheduling, model architecture, quantization, context length, and competing desktop graphics work all affect the result.

Before changing a setting, write down the complete test configuration:

  • CPU and integrated-GPU model, installed system memory, operating system, and graphics driver.
  • Inference application, backend, and exact software version.
  • Model family, parameter size, file format, and quantization.
  • Context limit, prompt length, requested output length, sampling settings, and whether a conversation history is reused.
  • One request at a time or several concurrent requests.
  • Whether the display, browser, video playback, or another program is using the GPU.

Use one fixed prompt, model, context, output length, and generation configuration for every comparison. Record four separate outcomes rather than one vague “speed” number:

Measurement What it tells you
Time to first token How quickly the system starts answering, including model loading, graph compilation, and prompt processing.
Prompt-processing rate How quickly the runtime evaluates the input and conversation history (prefill).
Generation rate Tokens per second after generation has begun.
Peak memory and fallback behavior Whether the model fits comfortably and whether the runtime silently moves work to the CPU or begins paging.

Do not compare a short prompt with a long one, different context limits, or different output lengths and call the result a backend comparison. A result is meaningful only with the machine, model, workload, backend, and software version attached to it.

Confirm that the intended GPU and backend are in use

A slow run may be a CPU run. The application can lack a compatible GPU backend, fail to load it, or select a device other than the iGPU. Check the runtime’s startup log and operating-system GPU monitor while an inference is active. Look for the selected device, backend name, allocated memory, and sustained activity during both prompt processing and token generation.

llama.cpp with Intel GPUs: SYCL and OpenVINO

For Intel hardware, llama.cpp documents two different routes: its SYCL backend and its OpenVINO backend. They are implementation-specific choices, not interchangeable flags for every frontend. Read the current backend documentation for the build and operating system you use: llama.cpp SYCL backend documentation and llama.cpp OpenVINO backend documentation.

The OpenVINO guide documents explicit GPU selection with GGML_OPENVINO_DEVICE=GPU. It also documents GGML_OPENVINO_STATEFUL_EXECUTION=1 as a workaround for a GPU stateless-execution issue. If the requested device is unset or unavailable, the guide says the backend defaults to CPU. Treat these variables as OpenVINO-backend examples; another application may use different names or expose no equivalent control.

Account for graph-conversion startup cost

The OpenVINO documentation warns: “When using the OpenVINO backend, the first inference token may have slightly higher latency due to on-the-fly conversion to the OpenVINO graph.” Measure a cold start separately from a warmed run. If you judge the backend from the first request only, graph compilation can make an otherwise faster configuration look slower. If your application restarts for every prompt, that startup cost is part of your real user experience; if it keeps the model loaded, compare repeated warmed requests as well.

Set context deliberately

The OpenVINO backend guide warns that its default context can resolve to the model’s training context. Its example notes a 131,072-token training context for Llama 3.2 1B. Allocating for that maximum on a laptop can consume memory and reduce performance even when your application needs only a few thousand tokens. In supported llama.cpp tools, set an explicit value with -c, such as the smallest limit that accommodates your longest prompt plus the conversation history you actually retain. Do not copy the 131,072-token example as a recommended setting; it is a warning about an oversized default.

Choose a model representation that fits shared memory

When a model is close to the machine’s memory limit, a smaller model or a lower-bit quantized variant is often a more useful experiment than an obscure kernel switch. Quantization stores weights with less numerical precision, reducing the representation’s memory demand and sometimes increasing throughput. The trade-off is task-dependent quality loss: a quantized model can change factual accuracy, instruction following, code quality, or tool-use reliability.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Evaluate quality with the tasks you care about, not only with tokens per second. Keep the model family and prompt fixed when comparing quantization levels, and record whether the runtime also quantizes the key-value (KV) cache. OpenVINO Model Server’s performance-tuning guidance discusses lower precision for both model weights and KV cache as ways to reduce memory use and improve throughput. Those controls are server features; a local desktop application may not expose them.

What the published Intel figures do—and do not—show

An Intel OpenVINO 2024.0 benchmark reports the following results for a Core Ultra 7 165H integrated GPU, using the paper’s 1,024-token input, 128-token output, and beam-1 test:

Model and precision Reported generation speed Scope
Llama-2-7b-chat INT4 8.5 tokens/second Intel vendor result on the named Core Ultra 7 165H platform and stated OpenVINO setup.
Llama-2-7b-chat INT8 5.4 tokens/second Intel vendor result on the same named platform and test setup.
Mistral-7b INT4 6.0 tokens/second Intel vendor result on the same named platform and test setup.

The figures come from Intel’s OpenVINO Toolkit LLM solution white paper. The document’s publication date is not stated in the reviewed PDF. These are narrowly scoped vendor measurements, not a typical iGPU speed claim or a prediction for your model, driver, runtime, or workload. No directly comparable independent benchmark across current integrated-GPU vendors, backends, model families, and workloads establishes a general winner.

Tune context and cache pressure before advanced switches

Every token in the prompt and retained history increases prefill work and usually increases KV-cache memory. If your application does not need a long conversation, lower the context limit and trim old turns. Keep enough room for the prompt plus the maximum answer you permit; setting it too low can truncate useful history or cause an error.

Test context as a controlled variable: keep the model and prompt content constant, run a short context and a larger one, and record first-token latency, prompt-processing rate, generation rate, and peak memory. A context reduction that helps a long prompt may have little effect on a short one. Conversely, an overly small context can force frequent summarization or reloads that make the complete workflow slower.

Prefix caching for repeated prompts

If many requests share a system prompt, document preamble, or retrieved prefix, a server can avoid evaluating identical tokens repeatedly. OpenVINO Model Server documents prefix caching as a performance technique. It is useful only when the application preserves and reuses the same prefix and the serving stack supports the feature; it is not a universal switch in local chat clients.

Tune for the workload you actually have

Single-user chat and first-token responsiveness

For one person waiting on one answer, prioritize time to first token and stable generation latency. Compare model size, context length, backend startup behavior, and quantization with one request at a time. A setting that raises maximum throughput can add queueing or batching delay and feel worse in an interactive chat.

Concurrent requests and aggregate throughput

For a local service handling several requests, measure total tokens per second across all requests, per-request latency, and the effect on memory. OpenVINO’s GPU-device documentation describes throughput mode, automatic batching when the device reports an optimal batch size above one, and multi-stream handling for simultaneous inference requests: OpenVINO GPU Device documentation.

Do not assume that multiple queues mean multiple kernels execute at the same time. The same documentation states: “Simultaneous scheduling of kernels to different queues does not mean that the kernels are actually executed in parallel on the GPU device.” Measure with your model and request pattern. Batching can improve aggregate throughput while increasing the first-token wait for an individual request, and streams can compete for shared memory bandwidth.

Use llama.cpp SYCL options cautiously

The llama.cpp SYCL documentation describes Intel-specific optimization options, including Flash Attention, which can reduce memory use. Its performance effect depends on the model and device, so benchmark it rather than treating it as a guaranteed speedup. The documentation indicates that Intel GPU optimization is enabled by default and recommends disabling that optimization for Intel devices older than Gen 10. Apply that recommendation only after identifying the GPU generation; do not disable an optimization on newer hardware because an older-device workaround was copied from a forum post.

Host-pinned memory is another documented SYCL option that can accelerate host-to-device copies on some systems. It consumes a different kind of host resource and can have trade-offs, so change it only after a baseline and keep a rollback path. Record the exact environment variable or build option you changed, then remove it if memory pressure, instability, or latency worsens.

Run a repeatable A/B test

  1. Warm up the runtime. Perform a separate cold-start run so graph compilation and model loading are visible, then run enough repeated requests to characterize warmed behavior.
  2. Keep the workload fixed. Use the same model file, prompt text, context limit, output limit, sampler settings, and number of concurrent requests.
  3. Change one variable. Examples include backend, quantization, context size, Flash Attention, batching, or stream count. Do not change model and backend simultaneously.
  4. Capture all four metrics. Record first-token latency, prompt-processing rate, generation rate, and peak memory, along with device and backend logs.
  5. Check quality. Run representative factual, coding, summarization, or tool-use tasks and note failures introduced by a smaller or more aggressively quantized model.
  6. Keep the winning change. Revert settings that help one metric while harming the metric your use case values, and retain the exact configuration so it can be reproduced after a driver or runtime update.

If the CPU is faster for a small model or a short workload, that is a valid result. Integrated-GPU dispatch overhead, memory transfers, graph compilation, or an immature backend can outweigh parallelism. Use the measured result rather than assuming that “GPU” must be faster.

Troubleshoot common symptoms

GPU utilization stays near zero

  • Check the runtime log for a selected GPU device and backend.
  • Confirm that the backend was built and installed for your operating system and exact GPU.
  • Check for a silent CPU fallback; the llama.cpp OpenVINO guide specifically documents CPU fallback when the requested device is unavailable or unset.
  • Close competing graphics workloads and repeat the test while monitoring both CPU and GPU memory.

First token is slow but later tokens improve

Separate cold and warm runs. OpenVINO graph conversion can add latency to the first inference token, while later tokens and subsequent runs may be faster. If your application is short-lived, choose a runtime and model that minimize startup work or keep the process alive; if it is persistent, optimize warmed latency and report the cold-start cost separately.

Long prompts cause sudden slowdowns or failures

  • Lower the explicit context limit to the application’s real requirement.
  • Trim or summarize old conversation turns.
  • Use a smaller or quantized model if memory is near exhaustion.
  • Check whether KV-cache precision controls are available in your serving stack.

More streams or batching makes chat feel worse

That usually means you optimized aggregate throughput instead of interactive latency. Return to one request, measure time to first token, then increase concurrency gradually. Keep the configuration only if the workload is genuinely multi-request and the throughput gain outweighs the added per-request delay.

A setting improves speed but causes poor answers

Compare the same evaluation prompts at the original and changed precision or model size. Quantization and smaller models can alter quality even when the output rate improves. Choose the smallest representation that passes your task-specific quality checks, not the one with the highest isolated tokens-per-second number.

Do not confuse an iGPU guide with an NPU recipe

OpenVINO’s GenAI NPU guide concerns Intel NPU execution, not a universal integrated-GPU configuration. It states that on Intel Core Ultra Processor Series 2 systems, more than 16 GB of RAM may be required for prompts over 1,024 tokens when models exceed 7B parameters. That is a qualified NPU-guide statement and cannot be generalized to every iGPU workload. The guide’s FAST_COMPILE and BEST_PERF performance modes likewise apply to that NPU pipeline, not automatically to GPU execution. See the OpenVINO GenAI NPU guide only when you are configuring an NPU.

When a hardware purchase is justified

Do not buy a particular computer, memory kit, cooler, or storage device until measurements show the bottleneck and the system is upgradeable. If peak memory is near the limit and the model is paging or falling back to the CPU, additional compatible system memory may help; verify motherboard or laptop limits and memory-channel configuration first. If the model fits comfortably but generation remains slow, a different backend, smaller model, or quantization may be more effective than a hardware purchase. Integrated-GPU performance is system-specific, so category-level claims about a future “AI PC” are not a substitute for a controlled test of the exact model and runtime.
