How to Run an AI Model on Sensitive Data Without Exposing Prompts or Outputs

Yes, but not by adding a “do not leak this” instruction to the system prompt. Keep sensitive data inside a controlled inference boundary, then apply authorization, minimization, encryption, prompt and tool controls, output inspection, and audit monitoring. Depending on who must be unable to see the data, that boundary can be a local or on-premises model, an isolated private-cloud deployment, or confidential inference inside a hardware-backed trusted execution environment (TEE).

No architecture removes every risk. A locally hosted model can still disclose a document to an unauthorized user; a private cloud can still expose data through an application bug; and a confidential-computing service still needs retrieval authorization and output filtering. Treat privacy as a system property, not a model setting.

What “not exposing prompts or outputs” really requires

A prompt can be exposed at several points: while an application assembles it, during network transit, in provider or gateway logs, inside a model-serving process, in vector indexes and caches, through tool calls, or in the generated answer. Outputs can leak the same information to an end user, another tenant, a log destination, an analyst, or a downstream system.

Start by writing a threat model. State which parties must be unable to read raw prompts, retrieved documents, and responses:

  • the model vendor or model developer;
  • cloud and data-center operators;
  • tenant or platform administrators;
  • compromised application accounts and tools;
  • other users who should not have access to the source documents;
  • accidental disclosure caused by prompts, logs, or support workflows; and
  • model memorization or extraction where that risk applies.

This list determines the correct boundary. Encryption in transit protects a network link, but not a service that receives plaintext. A private network limits exposure to the public internet, but does not automatically protect against a provider operator. A TEE can reduce operator visibility, but cannot decide whether a user is entitled to retrieve a particular file.

Choose the inference boundary

Use the narrowest boundary that satisfies your threat model and operational needs. The following designs are alternatives, not mutually exclusive: an organization may keep its most sensitive workloads on premises and use a private cloud for lower classifications.

Design Who can potentially see plaintext Attestation Capability and latency Operational trade-off
Local or on-premises inference Your administrators and anyone who compromises the host, model server, application, or logs. A vendor does not receive prompts if the model and dependencies remain inside your environment. Usually based on your own host-hardening and deployment evidence; hardware-backed remote attestation is not inherent. Model choice, context size, acceleration, and latency are constrained by your hardware. There is no provider network round trip. Maximum physical and administrative control, but you operate patching, capacity, model updates, incident response, and high-availability infrastructure.
Private network or private-cloud deployment Your application and the selected cloud services see plaintext. Provider personnel and subprocessors may still be in scope unless contracts and technical controls exclude them. Evidence comes from network isolation, identity controls, provider documentation, and contractual commitments. A private endpoint alone is not proof that operators cannot access data. Often broader model and managed-service options, with scalable capacity; latency depends on region and network path. Less hardware work than on premises, but you must verify retention, training use, human access, region, keys, and deletion terms.
Confidential inference in a TEE The application must still provide plaintext to the protected workload. Hardware and the attested software boundary are designed to reduce visibility for cloud operators, service operations, and the model developer. Remote attestation can let you verify measurements and declared data-use policies before sending a request. Availability, model formats, accelerators, context limits, and regional support vary by service; measure your workload rather than assuming parity with ordinary hosting. Strongest technical separation from infrastructure operators when correctly implemented, with additional attestation, key-release, deployment, and operational complexity.

Microsoft describes confidential AI as hardware-based protection for data and models throughout the AI lifecycle. Its confidential-inferencing guidance says the design can protect requests and responses from the model developer, service operations, and the cloud provider, with remote attestation used to verify declared data-use policies. That protection applies only to the attested workload and its stated configuration; it does not authorize users or sanitize your application.

Build a data-flow map before selecting a model

Draw every place a prompt, retrieved chunk, tool argument, or response can travel. Include browser and mobile clients, API gateways, queues, prompt templates, embedding services, vector databases, model servers, tool APIs, tracing systems, crash dumps, backups, support exports, and billing or diagnostic metadata.

For each hop, record the data classification, identity used, region, encryption state, retention period, and administrator access. A data-flow map often reveals exposures that the model endpoint itself does not control: an observability plugin may copy the complete prompt, or a vector database may retain documents after the source system has deleted them.

Implementation sequence

1. Classify and minimize every input

Define classes such as public, internal, confidential, regulated, and secret, then enforce the class at ingestion and retrieval time. Send only fields needed for the task. Remove account numbers, full addresses, credentials, private keys, and unrelated document sections before constructing context.

Mask or tokenize identifiers when the model does not need their real values. Keep a protected mapping outside the model context and detokenize only in a controlled post-processing step when necessary. Do not put secrets in URLs, tags, resource names, free-form name fields, or other metadata. AWS Bedrock documentation specifically warns that tags and fields such as a Name value can enter billing or diagnostic logs, and recommends never placing confidential customer information there.

2. Authorize retrieval before generation

Apply the requesting user’s identity and document permissions before a vector search result reaches the model. A common safe sequence is:

  1. Authenticate the user with your identity provider and obtain a short-lived authorization token.
  2. Translate that identity into document, tenant, geography, and purpose-of-use constraints.
  3. Apply those constraints as filters in the source repository and vector index.
  4. Fetch the minimum passages needed, re-checking authorization on the source record.
  5. Attach provenance and sensitivity labels to each passage for downstream policy checks.
  6. Send only the authorized, minimized context to the model.

Never rely on the model to enforce access control. A system prompt saying “answer only from authorized documents” is not an authorization mechanism, and a search index that mixes tenants without enforceable filters can disclose data even when the final answer looks reasonable.

3. Protect transport and storage

Use TLS for every client, service, database, queue, and tool connection; do not stop at the public API boundary. Encrypt prompts, retrieved content, embeddings, checkpoints, caches, backups, and outputs at rest. Use a key-management design that matches your threat model, such as customer-controlled keys, separated key administrators, rotation, and revocation.

Set explicit retention limits for request bodies, responses, traces, and backups. Disable content logging where possible. If a diagnostic system needs a record, store a request identifier, policy decision, classification, and cryptographic digest rather than the raw secret. Confirm that redaction occurs before data enters asynchronous queues or error reports.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

4. Harden the application boundary

Place an API gateway or policy enforcement point in front of the model. Enforce authentication, tenant isolation, rate limits, request-size and context-size limits, content classification, and an allow-list of models and tools. Validate structured requests against a schema instead of passing arbitrary JSON to a model or plugin.

Use separate credentials and least-privilege scopes for the model, vector database, file store, and each tool. A summarization model should not have a database-write token merely because another workflow needs one. Require explicit approval for actions that change records, send messages, move money, or alter access rights.

5. Defend against prompt injection and jailbreaks

Treat retrieved documents, web pages, emails, and user text as untrusted instructions. Delimit data from instructions, label its origin, and use an input classifier to detect attempts to override policy, request hidden prompts, or exfiltrate unrelated material. Apply size and nesting limits to documents and tool results.

OWASP notes that system-prompt instructions alone are insufficient because direct prompt injection can bypass them. Therefore detect, block, quarantine, or log suspicious inputs at the application boundary; do not expect a hidden instruction to protect a secret. For high-risk workflows, use a separate policy model or deterministic rules to approve tool calls and sensitive operations.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

6. Validate and filter outputs before release

Consider the model response untrusted output. Validate its schema, type, allowed fields, and destination before displaying or executing it. Run secret, credential, PII, and regulated-data detectors over the response and any tool-generated content. Redact or block matches, and return a generic safe error rather than echoing the triggering secret.

Use allow-lists for actions and destinations. If an answer contains a claim that would trigger a high-impact decision, route it to a human reviewer or require independent evidence. Escape output before inserting it into HTML, SQL, shell commands, or documents; content filtering does not replace ordinary injection defenses.

7. Keep logs useful without copying the secret

Log who requested an operation, which policy version ran, which model and tool identifiers were used, the decision outcome, latency, token counts where appropriate, and references to retrieved records. Avoid raw prompts, raw completions, and full document text in routine logs. If limited samples are required for incident response, encrypt them separately, restrict access, set a short retention period, and record every access.

Monitor unusual retrieval volume, repeated requests for hidden instructions, cross-tenant access failures, high rates of blocked outputs, sudden changes in token use, and tool calls outside normal patterns. Alerting should cover both successful access and repeated denied attempts.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

8. Verify a hosted provider before sending confidential data

Obtain written answers and technical evidence for each question below; a marketing statement that data is “private” is not sufficient.

  • Are prompts, retrieved context, and completions retained? For how long, in which systems, and in which regions?
  • Are they used for model training, abuse detection, quality review, or support? Can those uses be disabled contractually and technically?
  • Can provider staff, subprocessors, tenant administrators, or support engineers access plaintext?
  • Which regions process and back up the data, and how are cross-border transfers handled?
  • Who controls encryption keys, and can key revocation prevent future access?
  • What deletion, backup-expiration, incident-notification, and legal-disclosure commitments apply?
  • For confidential inference, what hardware, software image, policy measurement, and remote-attestation evidence can your application verify before releasing a key?

In the deployment-account architecture described in AWS Bedrock documentation, model providers do not have access to Bedrock logs or customer prompts and completions. That is a statement about that documented architecture, not a universal property of every hosted model or account configuration; verify the exact service, region, logging settings, and contract you will use.

9. Test the complete system adversarially

Test the deployed data flow, not only the model in isolation. Include:

  • direct requests for system prompts, credentials, hidden documents, and other users’ records;
  • indirect injection embedded in PDFs, emails, web pages, spreadsheets, and retrieved chunks;
  • attempts to cross tenants, roles, regions, and document classifications;
  • secret-exfiltration prompts using encoding, translation, summarization, or multi-turn persuasion;
  • malformed schemas, oversized contexts, recursive tool results, and unsafe output destinations;
  • logging, tracing, backups, caches, error pages, and support exports to confirm raw secrets are absent.

Record expected outcomes: deny, redact, ask for clarification, or require human approval. Repeat the tests after changing a model, system prompt, retrieval pipeline, policy, tool, region, or infrastructure image. A model update can change both refusal behavior and the shape of accidental disclosures.

Operational patterns that reduce exposure

Private-document question answering

Keep the source repository and permission-aware index inside the same controlled boundary as the model when possible. Retrieve only a few authorized passages, attach source identifiers rather than unnecessary metadata, and return citations that the user is already allowed to open. Do not expose hidden chunks merely because the model used them internally.

Secrets needed for an action

Do not place a long-lived credential in the prompt. Give a narrowly scoped broker or tool a short-lived token, keep the secret outside the model context, and return only the minimum result. The model can request “read invoice 123” while a deterministic service performs the authorized read; it should not receive a database password.

Regulated or high-impact decisions

Use a documented approval gate, deterministic eligibility rules, provenance for every input, and human review for consequential actions. Store the policy decision and evidence reference rather than a full copy of sensitive text. Make it possible to disable the model or tool without disabling the underlying business process.

Common mistakes and their fixes

Mistake Why it fails Better control
“The system prompt says never reveal secrets.” Direct or indirect prompt injection can override or confuse instructions. Input detection, authorization, output scanning, redaction, and tool approval.
“The endpoint uses HTTPS, so the provider cannot see data.” TLS protects transit, not plaintext at the receiving service. Choose a local boundary, contractual private service, or attested TEE according to the threat model.
Sending an entire database row or document for convenience. It increases the material available for accidental disclosure and retention. Minimize fields and retrieve only authorized passages.
Recording full prompts and answers in observability tools. Tracing, crash dumps, and backups become a second data-exfiltration path. Redact before logging; use metadata, hashes, short retention, and restricted sample access.
Putting customer details in resource tags or names. Metadata can flow into billing and diagnostic logs. Use opaque identifiers and keep sensitive values in protected data stores.
Giving the model broad tool permissions. A successful injection can turn a text-generation flaw into a real-world action. Least-privilege tools, allow-listed operations, scoped tokens, and human approval.

A practical decision checklist

Choose local or on-premises inference when physical and administrative control are non-negotiable, the model and hardware fit your workload, and your team can operate the stack. Choose a private cloud when isolation, regional placement, and provider controls meet your contractual and regulatory requirements and you need managed scale. Choose confidential inference when you must reduce trust in infrastructure operators and can verify the attested software and hardware boundary.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Whichever boundary you select, require all of the following before production:

  • a written threat model and data-classification policy;
  • permission-aware retrieval and least-privilege identities;
  • TLS, encryption at rest, key and retention controls;
  • prompt-injection, jailbreak, size, and schema defenses;
  • output validation, secret and PII detection, redaction, and safe errors;
  • logging that supports audit without replicating raw secrets;
  • provider terms covering retention, training, human access, region, deletion, subprocessors, and incidents; and
  • adversarial tests that are rerun after material changes.

NIST’s secure-development practices for generative AI likewise call for deliberate handling of prompts, user data, and outputs throughout development and operation. The result is not an “unseeable” model; it is a system in which each component has a defined trust boundary, a limited data view, and a tested response when something goes wrong.

Frequently Asked Questions

Can a local model guarantee that sensitive data will never leak?

No. Local hosting removes the model-vendor network path, but an unauthorized user, compromised host, permissive retrieval query, tool, or log can still disclose data. Authorization and output controls remain necessary.

Is a private cloud the same as confidential computing?

No. Private networking and contractual isolation limit access paths, while confidential computing uses hardware-backed protected execution and, where available, remote attestation to verify the workload before releasing data or keys.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Should prompts be deleted immediately after inference?

Use the shortest retention compatible with audit, safety, and legal requirements. Delete or expire raw prompts, completions, traces, caches, and backups on documented schedules, and avoid creating copies in diagnostics or support systems.

What should I do if an output detector finds a secret?

Block or redact the response, prevent downstream tool execution, record a minimal policy event, investigate the source and retrieval path, and rotate the exposed credential if it was real. Do not log the secret while investigating.

Do embeddings make private documents safe to store?

No. Embeddings and vector indexes can still reveal sensitive information and may be subject to the same access, retention, encryption, region, and deletion requirements as source documents.
