How to Run a Reliable AI Benchmark and Reproduce Its Results

To reproduce an AI benchmark result, define the decision the score will support, freeze the task and evaluation protocol, preserve the code, data and runtime artifacts, then report variation and limitations alongside the score. Replaying the same procedure makes a run auditable; it does not prove that the benchmark measures the capability you care about or predicts performance in deployment.

Start with the decision and capability you want to measure

Before choosing a benchmark, write down what decision its result will inform and what ability or outcome the evaluation is meant to measure. A useful statement is: “We use this evaluation to decide __; it measures __ for __ users or tasks under __ conditions.” Keep the measured property distinct from a downstream outcome you hope it predicts.

NIST’s January 2026 initial public draft, Practices for Automated Benchmark Evaluations of Language Models, frames the key question as “How will the measurements be used?” It is preliminary, voluntary guidance for automated language-model and agent evaluations—not a final, universal standard. It organizes practice around defining the target, implementing and running the evaluation, and analyzing and reporting results.

Automated benchmarks are most apt for structured tasks with verifiable, time-invariant outcomes. A benchmark can be a poor sole measure when work is open-ended, criteria are subjective, relevance changes rapidly, people interact with the system repeatedly, or the process matters as much as the final answer. For those targets, complement automated scores with methods such as human review, red-teaming, or field evaluation.

Choose a benchmark that fits the target

Popularity and ease of execution do not establish that a benchmark is suitable for a particular decision. Inspect its task and dataset against your target, then examine how the benchmark was built and scored.

  • Task and population: Do the items represent the users, tasks, language, and conditions relevant to your intended use?
  • Data and split: Check provenance, labels, split design, sample size, exclusions, preprocessing, and access restrictions.
  • Scoring: Read the metric definition and implementation. Determine how invalid, failed, or ambiguous outputs are handled, and whether the parser or judge matches the benchmark’s intended criteria.
  • Integrity and maintenance: Look for contamination exposure, gameability controls, known limitations, and version history. Confirm whether materials and updates are available.

BetterBench’s NeurIPS 2024 assessment evaluated 24 AI benchmarks against 46 best-practice criteria. In that assessed sample, most benchmarks did not report statistical significance or make results easy to replicate. Its checklist is a minimum-assurance aid, not proof that any benchmark fits your use case.

Freeze the protocol before the run

Write a methods record or machine-readable configuration before evaluating the system. This reduces ambiguity about what was run and makes deviations visible. Adapt the record to the task: a field that does not apply can be marked as not applicable, but material choices should not be left implicit.

  • Benchmark and data: Benchmark name and exact release or commit; dataset and split; sample count; preprocessing; exclusions; and any limits on data access.
  • System under evaluation: Provider and model name, exact model version or checkpoint hash, and relevant hardware or system details.
  • Inputs and tools: Prompt templates, few-shot examples, tools, agent scaffold, context limits, and any permitted model or system changes.
  • Generation and budget: Decoding settings, attempt and retry policy, resource, time, or cost limits, and stopping criteria.
  • Scoring: Evaluation-code revision, parser or judge version, metric implementation, aggregation rule, and treatment of invalid or failed outputs.
  • Run plan: Random seeds and what each controls, run count and order, and the rule for selecting or combining results.
  • Departures: Every change from the benchmark’s reference protocol and why it was made.

The NAACL reproducibility checklist is a useful complement: it asks authors to report models and algorithms, code and dependencies, infrastructure, runtime or energy, metrics, run counts, hyperparameter search and selection, summary statistics, dataset and label statistics, splits, exclusions, preprocessing, language, and data access.

NIST’s draft treats protocol design, evaluation code, execution and result tracking, and debugging as distinct parts of implementation. Check the scoring path, not just the final number: a parser can reject an answer that a person would recognize as correct. Inspect failures and validate that the scoring logic implements the stated metric. The draft describes benchmark versioning as an emerging practice and suggests package versions, Git tags, or commit hashes; record breaking changes when scores across versions are no longer comparable.

Run under controlled conditions and keep replay artifacts

For a meaningful comparison, use the same protocol and system conditions for the systems being compared. Save enough context for another person to trace a score back to the inputs, code, and environment that produced it.

  1. Pin the evaluation: Record the code commit, dependencies, operating system, relevant libraries and drivers, and a lockfile or container specification.
  2. Record the system and invocation: Save hardware details where relevant, configuration, exact command line, and runtime conditions.
  3. Retain inputs and outputs: Preserve raw logs and transcripts, input identifiers or hashes, result files, and the configuration alongside the final score.
  4. Keep every valid run: If the protocol permits repeated runs, retain each result and apply the predeclared aggregation rule rather than keeping only the most favorable outcome.
  5. Document access limits: Release code and configuration, plus data where lawful; otherwise give a clear route to access the data or identify what cannot be shared.

A practical target is “same inputs, same command, same pinned environment.” HumanEval.org offers an auditable example: its public methodology records input digests, seed, bootstrap-round count, thresholds, software and methodology versions, and a replay command. The methodology page identifies engine 1.1.0 and dump schema v2 as of September 8, 2026. Treat this as a useful pattern, not a guarantee that another system will be deterministic. Hosted models can change, and stochastic decoding can yield different outputs even when a seed is recorded.

MLCommons makes a benchmark definition concrete in terms of model, dataset, allowed model changes, and measurement. Its training rules require the same system and framework for a submission result set, define benchmark-specific repetitions, and discourage cherry-picking the lowest runtime. These are examples for governed system-performance submissions, not universal rules for every AI evaluation.

Repeat runs when variation could change the conclusion

For randomized training or inference, independent repetitions can show whether run-to-run variation affects the result. There is no universally correct run count: choose and justify it using pilot variability, desired precision, task stochasticity, convergence, and compute cost. For a formal submission, follow that benchmark’s own protocol. MLCommons’ training rules, for example, set repetition requirements by workload and combine runs under benchmark-specific rules.

Report the number of runs (N), per-run results when practical, the summary statistic, and a measure of spread or uncertainty with the method used. Do not report only a hand-picked best run. A recorded seed is useful for tracing a run, but by itself it does not guarantee the same output across different hardware, software, library versions, provider-side model updates, or stochastic systems.

Match uncertainty to the claim

Uncertainty over repeated runs and uncertainty over benchmark items answer different questions. A result on a fixed test set describes performance conditional on those items. A claim about expected performance on similar, unseen items requires an uncertainty method that reflects that sampling goal.

NIST’s 2026 statistical-modeling publication distinguishes benchmark accuracy from generalized accuracy and examines item difficulty and variance decomposition. Its study analyzed 22 API-access frontier language models across three popular benchmarks and describes generalized linear mixed models as one way to estimate generalized accuracy and uncertainty. That is an approach for a particular analysis, not a method every benchmark must adopt; choose a method whose assumptions fit the data and claim.

Interpret score differences without overclaiming

State the exact comparison conditions, uncertainty method, and limitations. A small score gap is not persuasive evidence of a meaningful ranking if measurement error or item sampling could explain it. Explain whether a difference matters for the intended decision, rather than treating every numerical lead as consequential.

A benchmark score establishes performance on defined tasks under defined conditions. On its own, it does not establish broad intelligence, safety, reliability, or suitability in an untested deployment. Discuss benchmark relevance, contamination or gameability risks, data limitations, parser failures, and mismatch with the intended operating environment. Identify model, data, or provider drift that may affect comparisons over time.

Make the result practical for someone else to replay

Bundle the protocol with the materials needed to run it: evaluation code and configuration, an environment lockfile or container, exact command, model and benchmark version identifiers, expected output artifacts, and a short explanation of how to interpret discrepancies. Use checksums or immutable identifiers for inputs and outputs where possible.

If private data, licensing, API availability, model snapshots, or compute costs prevent a full replay, state what is unavailable and which parts can still be reproduced or independently checked. A precise account of those limits is more useful than describing a result as fully reproducible when it is not.
