Track electricity separately from carbon: choosing cleaner electricity can lower emissions without reducing the workload’s kilowatt-hours.
Measure the workload before changing it
Start with a baseline for a representative training run or inference service. Record the model and version, hardware, input and output characteristics, utilization, throughput, latency, and task-quality metrics. Add the energy or carbon measure available to your team, and use the same measurement method and workload when comparing changes.

State the measurement boundary. Accelerator electricity alone excludes other information-technology equipment and data-center overhead such as cooling and power distribution. Google Cloud’s 2025 estimate for a median Gemini Apps text prompt was 0.24 Wh, 0.03 gCO2e, and 0.26 mL of water under its disclosed methodology; using an alternative boundary that counts active TPU/GPU consumption only, it reported 0.10 Wh, 0.02 gCO2e, and 0.12 mL. These are provider-reported figures for that service and method—not universal estimates for AI prompts. See Google’s methodology and results.

For a useful comparison, calculate energy per useful unit of work—for example, per request that meets a quality threshold or per completed training run. Keep the boundary and workload consistent, and assess service quality, latency, throughput, and reliability alongside energy. Carbon intensity and water impact may also matter, but neither substitutes for measuring electricity.

Reduce computation for each useful result
Choose the least costly model that meets the quality target
Test whether a smaller or task-specific model can meet the same acceptance criteria as a general-purpose model. For serving, consider distillation, quantization, or more efficient algorithms. For fine-tuning, parameter-efficient methods such as LoRA can update fewer parameters than full-model training. Sparse or mixture-of-experts designs may also be relevant where supported and appropriate. These are options to evaluate, not guaranteed savings: compare the actual service outcome on representative data.
Google Cloud’s AI and ML energy-efficiency guidance and Microsoft’s sustainable AI workload design guidance both emphasize efficient model and workload design. Neither establishes a universal energy-saving percentage for a given model change.

Eliminate avoidable training work
- Fine-tune a suitable pretrained model rather than training from scratch when it meets the task’s needs.
- Use early stopping when validation performance ceases to improve.
- Choose an efficient hyperparameter-search strategy instead of defaulting to exhaustive grids.
- Keep preprocessing and data loading efficient so accelerators do not sit idle waiting for data.
- Retrain when defined drift or quality conditions warrant it, rather than following an arbitrary schedule.
Use the same quality and operational checks after these changes; lower training energy is not useful if the resulting model fails the task.
Serve inference with less wasted work
Batch and cache when the service allows
Batch requests when the latency budget permits, since processing several requests together can avoid repeated overhead. Cache repeated results or reusable key-value state when correctness, freshness, privacy, and data-handling requirements allow it. Test cache behavior against real request patterns rather than assuming reuse will be high.

Match capacity to demand
Profile CPU, GPU, memory, and disk utilization under representative traffic. Select an instance configuration that meets service objectives without persistently idle capacity, and use autoscaling or serverless inference where the platform and workload make them suitable. Check throughput and tail latency as capacity changes; average utilization alone does not show whether requests are being delayed or dropped.
Google’s 2025 article reports that the median Gemini Apps text prompt’s energy use fell by 33× and its total carbon footprint by 44× over a recent 12-month period. That is a provider-reported comparison for Google’s own service, not a forecast for other workloads. Its examples reinforce why serving efficiency should be measured over time rather than inferred from model size alone.

Track utilization across preprocessing, training, and serving to identify where resources are waiting or oversized. AWS’s deep learning sustainability guidance covers utilization, demand shaping, and storage and processing choices. It also discusses unused-capacity options for suitable training jobs; verify current platform availability and ensure the job can tolerate interruption before relying on them.
Choose region and timing for carbon separately
If a job is flexible, compare current regional grid-carbon data and consider scheduling it for a cleaner period when platform tools and workload constraints permit. Data residency, legal obligations, latency, availability, and reliability can limit these choices. Microsoft’s Azure guidance, Google’s Google Cloud guidance, and AWS’s AWS guidance discuss location and timing as sustainability considerations.
A lower-carbon electricity mix can reduce emissions associated with a workload, but does not by itself reduce the electricity consumed. Report energy and emissions as separate measures, and do not treat a region as more energy-efficient without comparable workload and measurement data.

Use a repeatable optimization loop
- Baseline: Run a representative workload and record its boundary, energy measure, model, hardware, utilization, throughput, latency, quality, and reliability.
- Change one thing: For example, test a smaller model, caching, batching, early stopping, or a different capacity policy.
- Repeat consistently: Compare runs under the same workload and measurement method, accounting for traffic variation and other material differences.
- Keep or revert: Keep the change only if it reduces energy per useful result or improves the chosen carbon outcome without violating quality or service requirements.
- Monitor in production: Recheck as traffic, data, model versions, and platform conditions change; investigate regressions instead of assuming an earlier result remains true.
Data-center electricity demand provides context for why this work matters, but it should not be confused with AI’s individual share. The International Energy Agency estimated data centers used around 415 TWh, or about 1.5% of global electricity, in 2024; that is sector-wide electricity consumption, not an estimate of AI workloads alone. See the IEA’s discussion of energy demand from AI.
