Start with a memory budget, then reduce weight precision, context and batch limits before buying hardware. A model can fit by weight size and still fail when its KV cache, activations, temporary workspaces or allocator reservations grow. The reliable sequence is: measure the workload, choose the smallest adequate model, load lower-precision weights, cap runtime growth, offload or split layers when necessary, and use activation-saving methods for training.

Why a model that “fits” can still run out of VRAM

Model weights are usually the largest single allocation at startup, but they are only the starting point. NVIDIA’s planning heuristic is:

As an Amazon Associate I earn from qualifying purchases.

weight_memory_per_gpu = total_parameters × bytes_per_parameter ÷ tensor_parallel_size

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

total_parameters is the model’s parameter count, bytes_per_parameter is determined by the stored data type or quantization, and tensor_parallel_size is the number of GPUs sharing the weights. The result is a planning estimate, not a promise that inference will succeed. Runtime memory also includes the key-value (KV) cache, activations, temporary kernel workspaces and memory reserved by the allocator.

  • 12-Month Warranty: Backed by a 12-month manufacturer warranty for peace of mind. Designed to meet strict quality control standards for reliable everyday performance.

A concrete scale example comes from Hugging Face’s current documentation (accessed 2026): a 70-billion-parameter Llama 2 model requires about 256 GB in full precision and 128 GB in half precision for its weights. That reduction still leaves no allowance for the prompt, generated tokens, framework overhead or concurrent requests.

What grows after the model loads

  • KV cache: grows with sequence length, generated tokens and the number of simultaneous sequences.
  • Activations: become important during training and can spike during prompt processing.
  • Temporary workspaces: kernels may request additional buffers for attention, matrix operations or conversions.
  • Allocator reservations: a framework can reserve blocks that are not currently occupied by live tensors.

Long native context windows are a frequent trap. NVIDIA notes that contexts such as 128K tokens commonly trigger out-of-memory errors on limited-memory GPUs even when a short prompt worked.

Step 1: establish a real memory budget

Measure the workload you actually intend to run instead of comparing only the model’s download size with your GPU’s advertised VRAM. Record these values before changing settings:

  • GPU total memory and free memory while the process is stopped.
  • Parameter count and checkpoint format.
  • Weight data type or quantization level.
  • Maximum input context and maximum new tokens.
  • Batch size, micro-batch size and expected concurrent requests.
  • Whether the job is inference, serving or training.
  • For multi-GPU runs, the number of participating GPUs and placement strategy.

Use NVIDIA’s formula to estimate weight memory per GPU, then reserve headroom for KV cache, activations, kernels and allocator behavior. A model that barely fits this estimate can fail during a long prompt or late in generation, so do not treat every remaining megabyte as usable capacity.

A practical acceptance test

  1. Load the model with the intended dtype or quantization.
  2. Run a short prompt and note allocated and reserved memory.
  3. Test the longest supported prompt, the maximum generation limit and the expected concurrency separately.
  4. Repeat with production-like requests, because multiple sequences can multiply KV-cache usage.
  5. Keep a safety margin rather than setting a limit that leaves only a few megabytes free.

Step 2: choose a model that fits the task

Reducing parameter count is the cleanest and most predictable memory reduction. Match the model family and context window to the job: a smaller instruction-tuned model can be a better speed and reliability choice when a 70B model is unnecessary. This is a workload decision, not a claim that one model is universally best.

When a smaller model is appropriate

  • Your prompts are narrow, structured or domain-specific.
  • The larger checkpoint fails before you can test realistic latency.
  • You need several simultaneous users rather than one maximum-quality response.
  • You can evaluate quality with a representative prompt set and accept the smaller model’s results.

Benchmark quality and memory together. A nominally stronger model that constantly swaps, crashes or forces tiny batches may deliver less useful output than a smaller model that runs consistently.

Step 3: lower precision and quantize the weights

Precision reduction is normally the highest-impact software change. Use FP16 or BF16 instead of FP32 when the GPU and runtime support them. In the 70B example documented by Hugging Face, half precision uses about half the full-precision weight memory.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

8-bit and 4-bit loading

If half precision is still too large, load an 8-bit or 4-bit checkpoint through a supported library such as bitsandbytes, or use a runtime-native quantization format. Hugging Face documents workflows equivalent to load_in_8bit=True and load_in_4bit=True. The exact option name depends on the framework and model integration, so verify that the checkpoint, kernels and GPU architecture are supported.

Lower bit widths reduce weight storage substantially, but they are not free. Quantize/dequantize work can add latency, some operations may remain in higher precision, and quality can change by task. Test representative prompts at each candidate level rather than assuming 4-bit is always acceptable.

How to validate quantization

  1. Define a small evaluation set containing the prompts and output formats you care about.
  2. Run the original or half-precision model and save its outputs and task metrics.
  3. Run the 8-bit version, then the 4-bit version, under the same context and generation limits.
  4. Compare factual accuracy, formatting, refusal behavior and latency, not only whether the model loads.
  5. Keep the lowest precision that meets your quality and response-time requirements.

Quantization reduces weight memory; it does not remove KV-cache growth. A 4-bit model can still run out of memory when context, generation length or concurrency is excessive.

  • What You Get: Anker USB-C Hub (7-in-1), welcome guide, 18-month warranty, and our friendly customer service.

Step 4: control context, batch size and generation

After quantization, runtime settings often become the next memory limit. Lower the maximum context length, micro-batch size, concurrent requests and maximum new tokens. KV-cache use rises with sequence length and concurrency, while larger batches increase activation and workspace peaks.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Inference settings to change first

  • Maximum context: set it to the longest prompt your application actually needs, not the model’s native maximum.
  • Maximum new tokens: cap generation so an unexpectedly long answer cannot consume the remaining VRAM.
  • Micro-batch size: reduce it when prompt processing spikes memory.
  • Concurrent sequences: limit simultaneous requests while measuring per-request KV-cache growth.
  • Prefill and serving limits: use the runtime’s controls to prevent a large prompt from arriving alongside several generations.

Test both prefill and decode phases. A short prompt may pass while a long prompt fails during prefill; a single request may pass while concurrent users exhaust the cache during decode.

Step 5: offload or split the model

When one GPU cannot hold the weights, move selected layers or cache components to system RAM if the runtime supports CPU offload. This extends capacity but introduces host-device transfers, so latency can fall sharply when offload is heavy.

CPU and RAM offload

  • Use a runtime’s explicit CPU-offload or device-map option rather than manually copying tensors during generation.
  • Leave enough system RAM for the operating system and other processes.
  • Measure end-to-end latency; a model that loads is not necessarily usable at your required response rate.
  • Keep frequently used layers on the GPU when the runtime allows selective placement.

Multi-GPU placement

Tensor parallelism divides compatible layers or operations across GPUs; pipeline-style placement assigns groups of layers to different devices. Both can aggregate available VRAM, but communication and configuration overhead increase. Account for the smallest GPU’s capacity, interconnect speed and the runtime’s supported topology rather than simply adding the card capacities.

NVIDIA’s local-AI guidance lists llama.cpp, Ollama, TensorRT, SGLang, vLLM, WindowsML and PyTorch with CUDA as possible runtime families. Select among them based on model format, GPU architecture, memory, API requirements and throughput goals. Support for a particular quantization or parallel strategy differs by model and version.

Step 6: reduce memory for training and fine-tuning

Training stores more than inference: forward activations must be available for backward computation, and optimizer state and gradients add further allocations.

Activation checkpointing

PyTorch defines activation checkpointing as “a technique that trades compute for memory.” Instead of retaining every intermediate activation, the framework keeps selected checkpoints and recomputes the omitted forward segments during backward. This lowers peak activation memory at the cost of extra computation.

Combine checkpointing with:

  • Smaller micro-batches and gradient accumulation to preserve an effective larger batch.
  • Mixed-precision computation where the hardware and optimizer support it.
  • Parameter-efficient fine-tuning so most base weights remain frozen.
  • Memory-aware or paged optimizers that avoid unnecessary peak allocations.
  • Shorter training sequences when the task does not need the full context window.

What QLoRA demonstrates

Dettmers and colleagues reported fine-tuning a 65B model on one 48 GB GPU using 4-bit NF4 quantization, double quantization and paged optimizers (2023). Treat this as a feasibility reference, not a guarantee: architecture, sequence length, batch settings, optimizer choice, dataset and framework versions can change the result substantially.

Step 7: distinguish allocator behavior from a true leak

PyTorch notes that unused cached blocks can remain visible in nvidia-smi. Compare live tensor memory with reserved blocks before concluding that a process has leaked memory.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Measurements to collect

  • torch.cuda.memory_allocated() for memory held by live tensors.
  • torch.cuda.memory_reserved() for memory held by PyTorch’s allocator, including cached blocks.
  • Peak allocated and reserved counters around model loading, prefill and generation.
  • Memory snapshots when allocation patterns or failures are difficult to explain.

torch.cuda.empty_cache() releases unused cached blocks back to the driver; it cannot free memory held by live tensors and it does not increase the model’s true capacity. Use it as a diagnostic or between distinct workloads, not as a substitute for reducing peak usage.

Fragmentation and variable-size allocations

Workloads that repeatedly allocate different sizes can fail even when the total free memory appears sufficient, because free space is split into unusable blocks. For such patterns, evaluate the documented allocator setting PYTORCH_ALLOC_CONF=expandable_segments:True and measure the real workload before and after. Allocator tuning is workload-specific and does not add physical VRAM.

Which technique should you use?

Option Memory benefit Main cost or risk Best use
Smaller model Large and predictable Potential quality loss When task quality remains adequate
FP16/BF16 About half the FP32 weight bytes in the cited 70B example Hardware support and possible numeric differences General inference and training baseline
8-bit or 4-bit quantization Large weight reduction Quality, kernel support and dequantization latency Inference or QLoRA-style fine-tuning
Shorter context or lower batch Reduces KV-cache and activation peaks Less context, lower throughput or concurrency OOM during prompt processing or serving growth
CPU/RAM offload Lets oversized models load PCIe or interconnect transfer latency When capacity matters more than speed
Multi-GPU placement Aggregates VRAM More hardware, communication and configuration Models too large for one GPU
Activation checkpointing Reduces training activation memory Extra forward recomputation Fine-tuning with activation pressure
Allocator tuning Can reduce fragmentation failures Workload-specific and not a capacity increase Repeated or variable-size allocations

Failure modes and fixes

It fails while loading the checkpoint

The weight estimate is too close to available VRAM, or the framework temporarily needs extra conversion buffers. Choose a smaller model, FP16/BF16, 8-bit or 4-bit weights, or split layers across devices. Leave explicit headroom rather than trying to reclaim the last reserved block.

It loads, then fails on a long prompt

Prefill activations or KV-cache allocation exceeded the remaining memory. Lower maximum context, reduce micro-batch size and test the longest expected prompt before deployment.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

One request works but several users trigger OOM

Concurrent KV caches multiply memory use. Cap simultaneous sequences, lower per-request context or generation limits, and evaluate throughput at the intended concurrency.

nvidia-smi shows memory in use after a request ends

Compare memory_allocated() with memory_reserved(). If allocated memory falls while reserved memory remains high, cached blocks are accounting for the difference. empty_cache() can return unused blocks to the driver, but it cannot release live tensors.

Lower bit width hurts answers or makes generation slower

Move back to the next precision level that meets your evaluation threshold, check kernel and GPU support, and measure dequantization overhead. The lowest memory footprint is not automatically the best operating point.

When a hardware upgrade is justified

Buy or install a higher-VRAM GPU only after measuring the software options above. A capacity upgrade is justified when a smaller model fails quality requirements, quantization causes unacceptable degradation, context and batch limits are already too restrictive, and offload latency misses the application target. Choose capacity from the measured peak—not the model’s weight estimate alone—and account for KV cache, activations, workspaces and allocator headroom.

If local hardware remains unsuitable, hosted inference is another operational path, but provider geography, current pricing, data handling and service terms must be checked for the specific deployment. The same memory-budget method still applies because context, concurrency and precision affect hosted GPU consumption as well.

A concise decision path

  1. Measure total and free VRAM, model size, dtype, context, batch, generation limit and concurrency.
  2. Estimate per-GPU weight memory with NVIDIA’s formula and reserve runtime headroom.
  3. Try a smaller adequate model before changing infrastructure.
  4. Move from FP32 to FP16/BF16, then test 8-bit and 4-bit loading.
  5. Reduce context, micro-batch, concurrency and maximum new tokens.
  6. Use CPU offload or multi-GPU placement when capacity, rather than latency, is the binding constraint.
  7. For training, add checkpointing, gradient accumulation, mixed precision, parameter-efficient methods and memory-aware optimizers.
  8. Inspect allocated, reserved and peak memory before changing allocator settings.
  9. Validate quality, latency and failure behavior with production-like prompts before standardizing the configuration.
