Reduce cross-datacenter (cross-DC) traffic by changing where and when synchronization occurs: keep communication-heavy parallelism inside each facility, aggregate gradients or parameters locally before sending them over the WAN, expose the real topology to the collective library, and overlap the remaining transfers with useful computation. If the workload can tolerate asynchronous optimization, a low-communication design such as Decoupled DiLoCo can reduce synchronization requirements more radically, but it changes the training algorithm and its failure behavior.
What cross-datacenter traffic is costing your training job
Distributed training normally exchanges tensors, gradients, parameters, optimizer state, or control messages between ranks. When ranks are split between facilities, those exchanges traverse a long-haul link instead of a local InfiniBand, RoCE, or similarly low-latency fabric. Round-trip time is higher, available bandwidth may be smaller or shared, and a collective that is efficient inside one data center can become a step-time bottleneck across sites.

The objective is not simply to send fewer packets. You may instead need to lower WAN bytes, reduce the number of cross-site connections, hide latency behind computation, preserve throughput, improve behavior when a site fails, or fit a model in memory. Those outcomes are related but not interchangeable. A memory-sharding technique can leave WAN traffic unchanged, while an asynchronous method can reduce synchronization traffic but alter convergence and framework requirements.

Choose parallelism that respects the data-center boundary
Start with the model’s parallelism dimensions. NVIDIA’s guidance for multi-site NeMo deployments is that tensor, context, and expert parallelism require frequent, high-bandwidth synchronization and are therefore poorly suited to high-latency links between data centers. Data parallelism and pipeline parallelism generally create a more practical boundary: keep the tightly coupled groups within a site and place less frequent coordination across sites when the model layout permits it.

| Parallelism dimension | Typical communication characteristic | Cross-DC placement guidance |
|---|---|---|
| Tensor parallelism | Frequent synchronization of activations or partial results during layers | Keep the tensor-parallel group inside one facility whenever possible. |
| Context parallelism | Frequent exchange associated with distributed sequence or context processing | Keep latency-sensitive context groups local to a data center. |
| Expert parallelism | Token routing and collective exchanges between expert ranks | Avoid placing a high-volume expert group across a WAN unless measured results justify it. |
| Data parallelism | Gradient or update synchronization after a batch or accumulation interval | Use site-local replicas and aggregate before the inter-site reduction. |
| Pipeline parallelism | Stage-to-stage activation transfers | Keep stages that exchange every microbatch on a local fabric; use cross-site placement only with a tested schedule. |
This is a placement rule, not a universal prohibition. A very fast, low-latency inter-site fabric may change the trade-off, while a congested link may make even nominally infrequent synchronization expensive. Record the actual WAN round-trip time, bandwidth, packet loss, and topology before assigning ranks.
Aggregate locally with hierarchical all-reduce
For synchronous data parallelism, replace a flat all-reduce over every rank with a hierarchy that mirrors the facilities. NVIDIA’s described pattern has three phases: reduce-scatter within each data center, an all-reduce between data centers, and an all-gather within each data center. Only the consolidated site-level result needs to cross the long-haul connection.
- Group ranks by data center. Build a process group for each facility and ensure that the local group uses the fastest available intra-site network.
- Reduce-scatter locally. Each site combines its resident gradients and partitions the result among its local ranks. This removes duplicate intra-site contributions before WAN transmission.
- Run the inter-site all-reduce on the reduced representation. Exchange the site-level shards across the WAN rather than having every GPU connect directly to every remote GPU.
- All-gather locally. Reconstruct the synchronized result inside each facility, then continue the optimizer step or next forward pass.
The same principle applies to a localized optimizer arrangement. Optimizer state can be sharded within a site, local weight updates can be performed, and only the aggregate needed for global consistency is exchanged. NVIDIA’s NeMo material describes this partial-data-parallel approach together with chunked transfers that overlap the inter-site reduction with computation.
Do these 3 things before closing this tab:
1Scan for outdated or missing drivers - takes under a minute2Repair Windows errors before they cause bigger problems3Fix the driver behind crashes, sound loss and screen glitchesHierarchical reduction lowers WAN exposure; it does not make the WAN free. The cross-site phase still has to complete often enough to satisfy the chosen convergence schedule, and the local reduction can add buffering or synchronization points. Measure step time and convergence rather than assuming that fewer connections automatically means higher throughput.
Give the collective library an accurate topology
A collective library cannot optimize paths it cannot see. NVIDIA’s cross-DC NCCL design uses fabric IDs and a network API to discover whether a path is intra-data-center, cross-data-center, or disconnected. NCCL can then construct rings and trees with fewer cross-site connections instead of treating all links as equivalent.

Describe homogeneous and mixed fabrics
In a homogeneous deployment, the same class of interconnect may be used inside and between sites. In a heterogeneous deployment, a common pattern is InfiniBand or RoCE inside each facility and TCP between facilities. The network plugin must expose those differences so that the collective planner does not route a latency-sensitive intra-site edge through the WAN.
Test the relevant NCCL controls
NVIDIA lists several controls for cross-DC tuning:
NCCL_SCATTER_XDCcontrols scattering of channels so cross-site connections are distributed rather than concentrated.NCCL_IB_QPS_PER_CONNECTIONcan be evaluated when higher-latency InfiniBand or RoCE paths need more queue pairs per connection.NCCL_NSOCKS_PERTHREADandNCCL_SOCKET_NTHREADScan be tested for higher-latency TCP paths.- Socket task-size and buffer settings may affect how efficiently large transfers use the WAN.
These are tuning knobs, not universal best values. Change one class of setting at a time, capture collective duration and WAN utilization, and retain the configuration only when a like-for-like workload improves. Also verify that the installed NCCL version and network plugin support the controls you select.
Understand the connection-distribution example
NVIDIA illustrates the topology problem with four GPUs per node and a 400-Gbps host channel adapter (HCA) per GPU. A single cross-DC connection representing all four GPUs would need 1.6 Tbps in that stated scenario. Scattering can reduce the requirement on an individual connection to 400 Gbps, with additional channels potentially distributing it further. This example explains how connection placement changes link requirements; it is not a general guarantee that scattering reduces total traffic or delivers a particular speedup.
Overlap unavoidable WAN transfers with computation
After local aggregation and topology planning, schedule the remaining WAN work so GPUs are not idle while waiting for a remote reduction. Divide a large inter-site transfer into chunks. Launch a chunk as soon as its local gradient or update segment is ready, continue the next computation on independent data, and synchronize only when the consumer of that chunk needs it.
Useful overlap requires enough buffering and independent work. If a model’s next layer depends immediately on the full synchronized tensor, there may be little latency to hide. Gradient accumulation, pipeline microbatches, and bucketed reductions can create larger windows, but they also change memory use and the point at which updates become visible.

A practical overlap checklist
- Bucket gradients by readiness instead of waiting for the entire model.
- Use nonblocking collective calls and separate communication streams where the framework supports them.
- Set chunk sizes from measurements: very small chunks increase launch overhead, while very large chunks reduce overlap opportunities.
- Confirm with a timeline that computation actually occupies the interval in which the WAN transfer runs.
- Watch for hidden synchronization in the framework, allocator, or data loader that serializes apparently asynchronous work.
Track exposed communication time, not just link utilization. A WAN can be busy while still delaying the critical path if transfers are scheduled at the wrong point in the step.

Consider asynchronous, low-communication training when synchronization is the problem
Hierarchical collectives optimize conventional synchronous training. Decoupled DiLoCo takes a different approach: learner units, or “islands,” perform local computation and exchange updates asynchronously. The design aims to make training workable with lower WAN bandwidth and to isolate failures between compute islands.
This is an architectural and optimization change, not another NCCL setting. Evaluate whether the model, optimizer, framework integration, and quality target tolerate stale or delayed updates. You must also define how checkpoints, learner membership, retries, and a permanently unavailable island are handled. A method that reduces bytes but fails your convergence or reproducibility requirements is not a successful deployment.
What the reported results do and do not show
Google DeepMind’s April 23, 2026 post reports that a 12-billion-parameter model was trained across four US regions using 2–5 Gbps of WAN connectivity, and says the result was more than 20 times faster than conventional synchronization methods in its experiment. The post also reports these named comparisons:
| Reported result | Context and qualification |
|---|---|
| 198 Gbps versus 0.84 Gbps required bandwidth | Google DeepMind’s comparison for eight data centers; the post presents the chart as a simulated training run. |
| 27% versus 88% goodput under high hardware-failure rates | Google DeepMind’s failure comparison; the post identifies the chart as simulated. |
| 64.4 versus 64.1 average accuracy | Google DeepMind’s benchmark comparison, described as a real-world experiment rather than the same simulated runs. |
These are results reported for Google’s system and experiments, not a neutral comparison of every asynchronous method with synchronous collectives. Reproduce the evaluation with your model and WAN before making a production decision.

Do not mistake memory sharding for WAN-traffic reduction
ZeRO partitions optimizer states, gradients, and parameters across data-parallel processes instead of replicating them. That can remove memory duplication and make a larger model fit, but the memory result and communication result must be analyzed separately.
| ZeRO stage described by Microsoft Research | Memory effect in the cited comparison | Communication effect in the cited comparison |
|---|---|---|
| Stage 1: optimizer-state partitioning | 4× memory reduction | Same communication volume as data parallelism |
| Stage 2: optimizer-state and gradient partitioning | 8× memory reduction | Same communication volume as data parallelism |
| Stage 3: parameter partitioning as well | Memory reduction scales with data-parallel degree | Stated 50% communication-volume increase |
The figures are from Microsoft’s 2020 ZeRO system description, not an independent measurement of WAN bytes for every implementation. Use ZeRO when memory capacity is the constraint; combine it with hierarchical groups or topology-aware collectives when WAN traffic is the constraint.
Account for cloud-specific collective implementations
Some providers ship collectives tuned to their own network topology. AWS documentation describes the SageMaker distributed data parallelism library’s AllReduce and AllGather implementations as optimized for AWS and its EC2 topology, with Elastic Fabric Adapter (EFA) in the described AllGather path. Such a library can be valuable inside that infrastructure, but its assumptions are not a portable prescription for a multi-cloud or mixed-fabric deployment.
Check the provider’s supported instance families, transport, process-group requirements, and failure behavior. If sites use different providers or network technologies, test whether the library can represent the inter-site path; otherwise, use a topology-aware layer that can.

Do not judge a change by WAN bandwidth alone. A successful configuration may reduce bytes but increase local reduction time, or consume more bandwidth while shortening the critical path through better overlap. Establish a like-for-like baseline with the same model, batch size, precision, optimizer, number of ranks, data mix, and convergence target.
Best Value
Metrics to collect
- Inter-site bytes and bandwidth: total bytes per step and peak or sustained WAN rate, separated from intra-site traffic.
- RTT and latency: measured between the actual endpoints used by the collective, not a generic regional estimate.
- Collective duration: time for each reduce-scatter, all-reduce, all-gather, and asynchronous update exchange.
- Overlap: communication time hidden by computation versus time exposed on the critical path.
- Training performance: step time, samples or tokens per second, and goodput when failures are injected.
- Convergence and model quality: loss curves, time to a fixed quality target, validation accuracy, and final benchmark score.
- Fault behavior: recovery time, checkpoint consistency, and whether one unavailable site stalls all progress.
Run a controlled comparison
- Measure a flat synchronous baseline for enough steps to capture steady-state collectives.
- Apply site-local process groups and hierarchical reduction without changing the model or batch semantics.
- Expose fabric IDs and path types, then test topology-aware NCCL settings one at a time.
- Add chunking and asynchronous launches, confirming overlap with a profiler timeline.
- Run an asynchronous method separately with its own convergence and failure criteria.
- Repeat under representative WAN contention and at least one site or link failure if resilience is a requirement.
NVIDIA reports a NeMo/Megatron example using 3,072 GPUs across two data centers, with 1,536 GPUs at each site, Chicago and Ashburn about 1,000 km apart, and measured round-trip latency of 21 ms. The reported result was over 96% of baseline throughput. Treat that as a vendor-specific example tied to its hardware, software, topology, and workload, not as an expected percentage for your cluster.
Pick the strategy by bottleneck and constraint
| Primary problem | Most appropriate first move | What to verify |
|---|---|---|
| Too many remote connections in synchronous data parallelism | Hierarchical reduce-scatter, cross-site all-reduce, and local all-gather | WAN bytes per step, cross-site collective duration, and convergence equivalence |
| Collectives route over the wrong links | Expose fabric IDs and path types; tune NCCL channel and socket controls | Ring/tree topology, link utilization, and exposed communication time |
| WAN transfers stall otherwise useful work | Chunk transfers and overlap them with computation or pipeline microbatches | Profiler evidence that communication is hidden rather than merely concurrent |
| WAN capacity is fundamentally low or unreliable | Evaluate asynchronous low-communication training such as Decoupled DiLoCo | Model quality, optimizer compatibility, stale-update behavior, and failure recovery |
| GPU memory is the limiting resource | Use state or parameter sharding such as ZeRO | Whether the selected stage changes WAN volume; do not assume that memory savings do |
| A single cloud topology dominates the deployment | Assess the provider’s optimized collective implementation | Portability, supported transports, and behavior across the actual site boundary |
Implementation pitfalls and recovery steps
Every rank still contacts every remote rank
Symptom: WAN connection count and bytes remain close to the flat all-reduce baseline. Likely cause: process groups were not separated by facility, or the collective library was not given topology information. Recovery: verify rank-to-site mapping, create explicit local groups, inspect the generated ring or tree, and rerun the hierarchical sequence.
Topology tuning increases, rather than decreases, step time
Symptom: a new socket or queue-pair setting raises CPU overhead or causes congestion. Likely cause: a value suited to a different RTT, transport, or message size. Recovery: restore the baseline, change one variable, and compare collective duration and exposed communication under the same workload.
Communication appears overlapped but GPUs are still idle
Symptom: network and compute streams are active at the same time, yet step time does not improve. Likely cause: a dependency, implicit barrier, memory pressure, or poorly sized bucket keeps the critical path serialized. Recovery: inspect a timeline, move the launch earlier, adjust chunk or bucket size, and remove unnecessary synchronization.
Memory sharding solves capacity but not WAN congestion
Symptom: the model fits after enabling ZeRO, while inter-site bytes and collective time are unchanged or higher. Recovery: retain the memory optimization if needed, then separately implement local aggregation, topology-aware routing, or an asynchronous design.
Asynchronous training survives failures but misses the quality target
Symptom: islands continue making progress, but loss or validation quality diverges from the synchronous baseline. Recovery: tune the optimizer and exchange interval within the method’s supported configuration, compare time-to-quality rather than raw throughput, and revert to hierarchical synchronous training if the target remains unmet.
A deployment sequence that limits risk
- Map the fabric. Document GPUs, hosts, racks, facilities, interconnects, WAN endpoints, RTT, bandwidth, and failure domains.
- Map the model. Identify which parallelism dimensions synchronize at every layer, microbatch, or optimizer step.
- Place tightly coupled groups locally. Keep tensor, context, and expert groups inside a facility where possible; assign data and pipeline groups across sites only when their cadence is acceptable.
- Build the hierarchy. Implement local reduce-scatter, a site-level all-reduce, and local all-gather with explicit process groups.
- Expose topology. Configure fabric IDs and network-plugin path queries so the collective layer distinguishes local, remote, and unavailable paths.
- Overlap transfers. Bucket or chunk communication, launch it nonblockingly, and validate overlap in a trace.
- Benchmark fairly. Compare step time, WAN bytes, throughput, quality, and failure recovery against an unchanged baseline.
- Escalate to a different architecture only when justified. If the WAN remains the dominant constraint, test asynchronous low-communication training with independent convergence and resilience gates.
What the published evidence supports
The available figures come from engineering or research publications rather than one neutral benchmark spanning all methods, models, fabrics, and quality targets. NVIDIA’s 3,072-GPU throughput example, Google’s Decoupled DiLoCo bandwidth and goodput comparisons, Microsoft’s ZeRO communication analysis, and AWS’s topology-specific collectives each answer different questions. None establishes a universal winning technique or a guaranteed percentage reduction in WAN traffic.
The defensible conclusion is operational: first align parallelism and process groups with the data-center hierarchy; then aggregate before crossing the WAN; make the collective library topology-aware; overlap transfers; and measure the resulting bytes, critical-path time, quality, and failure behavior. Use asynchronous training when its changed optimization semantics are acceptable, and use memory sharding for memory pressure rather than assuming it is a network optimization.
