How to reduce AI inference costs without hurting performance

The safest way to cut AI inference spending is to optimize cost per successful task, not the price of an individual token. Measure quality, completion rate, latency and retries on representative traffic; then remove wasted output, reuse repeated context, route easy work to less expensive models and apply serving optimizations only when tests show a benefit.

There is no universal percentage saving. The right mix depends on your request distribution, prompt and response lengths, concurrency, hardware, latency target and the consequences of an incorrect answer. The workflow below gives you a way to lower spend while keeping the performance users actually notice.

Define performance before you optimize cost

A cheaper request is not a cheaper task if it needs a retry, human correction or an escalation to a larger model. Track the unit that matters to your product: a correctly completed classification, a resolved support case, a generated document that passes review or another clearly defined outcome.

Use a four-part scorecard

  • Cost: input and output tokens, provider charges, routing calls, retries, escalations and any serving infrastructure allocated to the task.
  • Quality: task-specific accuracy, rubric scores, groundedness, safety checks or human acceptance rate.
  • Latency: time to first token (TTFT), time between tokens (inter-token latency), total response time and the p50, p95 and p99 values that expose tail behavior.
  • Reliability: timeout, error, empty-response and retry rates, plus the percentage of requests that finish without intervention.

Keep interactive and offline traffic in separate cohorts. A configuration that is excellent for an overnight batch can be unacceptable when a person is waiting for the first token.

Build a representative baseline

Sample real requests by task type, language, prompt length, output length, user tier and concurrency. Record the model and version, token counts, cache status, routing decision, response time, outcome and retries. Preserve a held-out evaluation set so that a cost change is not judged only on the traffic that motivated it.

Compute cost per successful task as total spend divided by completed tasks that meet your quality bar. Keep a second view of cost per request so that a rise in failures or escalations cannot hide behind an apparently lower token bill. Re-run the baseline whenever model versions, prompts, retrieval systems or traffic mix changes.

Cut unnecessary generated tokens first

Generation is usually the serial part of inference: tokens are produced one after another, so long answers directly extend decode time. OpenAI’s latency guidance gives a rule of thumb that cutting output by 50% may cut latency by roughly 50%; it is guidance, not a guaranteed result for every model or workload. The same guide says cutting 50% of a prompt may improve latency by only about 1–5% in typical cases, except with very large contexts. See OpenAI’s latency optimization guidance.

Make concise output an explicit requirement

  • State the required audience, format and maximum useful detail in the instruction.
  • Ask for a fixed schema when downstream code needs fields rather than prose.
  • Set an output-token limit that leaves room for valid completion but prevents runaway explanations.
  • Return only the fields the user or next service consumes; remove duplicate summaries and conversational filler.
  • Replace several sequential calls with one call when the intermediate artifacts are not independently needed.

Do not shorten answers that are failing because they omit evidence, citations, edge cases or required fields. Compare task success before and after each change, and inspect truncation and refusal rates.

Trim oversized context without deleting what the task needs

Large prompts can increase prefill work, memory pressure and billed input tokens, but input reduction is not automatically a major latency lever for ordinary contexts. Remove irrelevant retrieval results, stale conversation turns, repeated boilerplate and tool descriptions that are not used in a particular route. Keep the instructions, examples, data and constraints required for a correct answer.

A practical context audit

  1. Log the token contribution of system instructions, tools, conversation history, retrieved passages and user content separately.
  2. Mark each segment as required, conditionally required or expendable for the task.
  3. Deduplicate repeated passages and collapse boilerplate into a stable reference or shorter instruction.
  4. Set retrieval limits based on measured answer quality rather than a fixed large top-k value.
  5. Evaluate the shortened prompt on difficult and long-tail examples, not just average requests.

If a prompt is already small, shortening it may save billing while producing little visible speedup. Prioritize output reduction and model selection when latency is dominated by decoding.

Use prompt-prefix caching when context repeats

Prompt caching can avoid recomputing and rebilling eligible portions of a repeated prefix. Stable system instructions, tool definitions, policies and shared context are common candidates. A cache hit is conditional: the provider, model, minimum cacheable prefix, request routing, retention period, region and billing rules all matter. Preserve identical reusable text and inspect actual cache reads and writes instead of assuming similar prompts will hit.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Design prompts for reusable prefixes

  • Put invariant instructions and tool schemas first.
  • Keep dynamic user data, timestamps and request-specific retrieval after the stable prefix.
  • Use a canonical serialization so whitespace or ordering changes do not invalidate the prefix.
  • Track hit rate, cached-token volume, cache-read charges, expiration and quality effects.
  • Verify data-retention and regional requirements before caching sensitive context.

Reported savings vary widely. Anthropic’s current cost guidance reports 2.7-to-5.3-times lower agent-loop cost on its benchmarks, an 83% bill reduction for one small triage agent, and 88% when input trimming was added. Those are Anthropic measurements, not a cross-provider guarantee; details are in its cost and intelligence guidance. AWS advertises prompt-caching reductions of up to 90% in cost and up to 85% in latency for supported models on Amazon Bedrock; these are vendor maximums, not typical or independent benchmark results. Check the current Bedrock cost-optimization documentation for model eligibility and terms.

Route each request to the least expensive model that passes

Model size is often the largest single influence on inference speed and price. OpenAI states that smaller models usually run faster and cheaper and, when used correctly, can outperform larger models; its recommendation is to use prompts, examples, fine-tuning or distillation to preserve quality. Google Cloud similarly describes routing simple classification, summarization and formatting jobs to smaller models while reserving stronger models for difficult reasoning. These are provider recommendations, so validate them against your own task data: OpenAI latency guidance and Google Cloud’s inference guide.

Create a routing policy

  1. Classify the request. Use deterministic rules when possible (task type, required context length, language, user tier or a known workflow). A small routing model can handle ambiguous cases, but include its tokens and latency in the cost calculation.
  2. Send easy cases to a lower-cost tier. Examples include fixed-label classification, extraction with a strict schema, short summaries and formatting transformations.
  3. Escalate uncertainty. Escalate low confidence, policy-sensitive content, failed validation, missing fields or tool errors to a stronger model.
  4. Limit retries. Retry transient transport failures with backoff; do not repeatedly resubmit a semantically failed answer without changing the cause.
  5. Review the boundary. Measure false escalations (unnecessarily expensive) and missed escalations (quality failures) separately.

Compare the whole route: routing-call cost, first-model cost, validation, retries and escalation. A lower token rate can lose when its failure rate is higher.

Use examples, distillation or fine-tuning selectively

Few-shot examples can let a smaller model follow a format or policy that a larger model handles from general capability. Distillation or fine-tuning may transfer a narrow behavior to a cheaper model, but they add data, evaluation and maintenance work. Keep a regression set for rare and adversarial cases before replacing a general model.

Choose batching for work that can wait

Batching raises utilization by processing multiple requests together and can be effective for offline evaluations, indexing, backfills and bulk generation. It also introduces queueing: an individual request may wait for a batch window, and larger batches can increase tail latency. Do not use it for an interactive path unless the user experience explicitly tolerates the delay.

Workload Usually suitable What to measure
Interactive chat or autocomplete Low-latency single-request or small dynamic batches TTFT, inter-token latency, p95/p99 response time and abandonment
Offline evaluation and data processing Large batches or provider batch APIs Total completion window, throughput, error recovery and cost per completed item
Mixed traffic Separate queues and service objectives Whether batch jobs consume capacity needed by interactive users

Confirm the provider’s batch pricing, completion window, request-size limits and retry semantics before moving production work.

Optimize self-hosted serving only after measuring the bottleneck

For a self-hosted model, inference has two distinct phases. Prefill processes the prompt in parallel and builds the key-value (KV) cache; it is generally compute-bound. Decode generates tokens autoregressively and is often limited by memory bandwidth. Google Cloud’s explanation of these phases, along with continuous batching, paged attention, intelligent routing, speculative decoding and quantization, is a useful starting point for a benchmark plan: Google Cloud inference techniques.

Benchmark with production-shaped traffic

  • Vary prompt and output lengths, concurrency and arrival bursts.
  • Report throughput together with TTFT, inter-token latency and tail latency.
  • Measure GPU utilization, memory use, queue time and failed requests.
  • Evaluate answer quality and structured-output validity after every runtime change.

Quantization

Lower-precision weights reduce memory pressure and can allow a model to fit on fewer or smaller accelerators. Google Cloud states that moving from FP16 to INT8 or INT4 reduces the weight-memory footprint to one-half or one-quarter, respectively. That ratio describes weight storage, not guaranteed end-to-end cost or speed. Kernel support, activation precision, calibration data and the workload determine the result. Test quality, TTFT, decode speed, throughput and stability on the exact hardware and runtime before deployment.

Continuous batching and paged attention

Continuous batching admits and retires sequences as they progress, improving utilization when requests have different lengths. Paged attention manages KV memory in blocks to reduce fragmentation. Both can increase throughput, but queueing and scheduling policies may raise an individual request’s latency. Tune batch limits and fairness for your service-level objectives rather than maximizing GPU utilization alone.

Speculative decoding

A smaller draft model can propose tokens that a larger model verifies, potentially increasing decode speed when proposals are accepted frequently. The extra model and verification work add memory and operational complexity, so benchmark acceptance rate, throughput, latency and quality under your actual prompts.

Independent reader supportYour contribution helps us test, update, and keep practical guides available for everyone.Support on Ko-Fi

Use cache-aware routing when prefixes and traffic are uneven

Cache-aware routing directs a request to an instance that already holds relevant KV blocks while considering current GPU load. AWS Prescriptive Guidance says this helps most when prefixes repeat and request distribution is non-uniform; with mostly unique requests, routing overhead can outweigh the benefit. Its system-optimization guidance also cautions that retrieving from a tiered cache adds I/O latency: AWS system-level guidance.

Implement it only after you can measure prefix reuse, KV hit rate, routing time and the load imbalance it creates. Define a fallback for a cold or overloaded cache, and ensure that tenant or authorization boundaries cannot be crossed by reused state.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Consider prefill/decode disaggregation as a specialized option

Separating prefill workers from decode workers can prevent long prompts from interfering with token generation when concurrency is high or prompts and responses have very different shapes. It requires transferring KV data between phases, coordinating schedulers and operating more infrastructure. AWS notes that this approach can typically double GPU count and should be treated as a specialized design, not a default optimization.

Adopt it only when traces show phase interference that batching, routing and model selection cannot solve. Measure transfer overhead, TTFT, inter-token latency, utilization, failure recovery and total cost at the target concurrency.

Balance the major trade-offs

Lever Potential benefit Primary risk Validation test
Smaller model or routing Lower token and compute cost; often lower latency Task-specific errors, more retries or escalations Held-out quality set and cost per successful task
Output limits and concise formats Less decode time and output billing Truncation or missing required detail Schema validity, completeness and user acceptance
Input trimming Lower input billing and memory use Lost evidence or little latency improvement for small prompts Ablation by context segment, including long-tail cases
Prefix caching Less repeated prefill work and possible cache discounts Low hit rate, expiration, routing or cache-read charges Observed hit rate, cache economics and retention review
Batching Higher utilization and offline throughput Queueing and delayed individual responses Completion window and tail-latency measurements
Quantization Lower weight memory; possible speed or capacity gain Quality loss or unsupported kernels Hardware-specific performance and regression tests
Cache-aware routing More KV reuse Routing overhead and load imbalance Reuse distribution, routing time and GPU-load variance
Prefill/decode disaggregation Isolation of compute-heavy and bandwidth-heavy phases Transfer overhead and substantially more infrastructure Trace-driven test at production concurrency

A staged rollout that limits risk

  1. Instrument first. Capture tokens, spend, quality, latency percentiles, reliability, concurrency and retries, separated by workload.
  2. Remove output waste. Tighten formats, limits and unnecessary sequential calls; verify that required content remains.
  3. Clean context. Remove irrelevant retrieval and stale history while retaining task-critical evidence.
  4. Stabilize and cache prefixes. Confirm eligibility, retention, regional handling and actual hit economics.
  5. Test model tiers. Route clearly easy work to a cheaper model, add validation and escalate uncertain cases.
  6. Batch delay-tolerant jobs. Keep interactive and offline queues isolated and monitor completion windows.
  7. Benchmark runtime changes. For self-hosting, test quantization, continuous batching, paged attention, speculative decoding and cache-aware scheduling under realistic load.
  8. Change architecture last. Use tiered KV caching or prefill/decode disaggregation only when traces identify a bottleneck that simpler changes cannot address.

Roll out behind a feature flag or traffic split. Set guardrails for quality, p95 latency, error rate and cost per successful task; automatically stop or revert when any critical guardrail regresses.

How to interpret vendor savings claims

Provider documentation is valuable for understanding supported features and service behavior, but it is not an independent comparison across vendors. A quoted maximum, benchmark multiplier or memory ratio applies to the stated models, hardware, prompts and accounting method. Current model availability, prices, cache eligibility and regional restrictions can change. Recheck the linked documentation and reproduce the measurement on your own representative workload before budgeting a saving.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Google Cloud’s Karl Weinmeister summarizes the optimization problem this way: “Every dollar that you spend on model inference buys you a position on a graph of latency and throughput.” The practical implication is to choose a point that satisfies your product’s quality and responsiveness requirements, rather than minimizing one metric in isolation.

Decision checklist

  • Do you know cost per successful task for each major workflow?
  • Are interactive and offline requests measured separately?
  • Is output longer than the user or downstream system needs?
  • Does the prompt contain stale, duplicated or irrelevant context?
  • Are stable prefixes placed first and is cache hit rate measured?
  • Can a cheaper model pass a representative quality and safety set?
  • Are routing, validation, retries and escalations included in total cost?
  • Would batching’s waiting time violate the user-facing latency target?
  • For self-hosting, have you measured TTFT, inter-token latency, throughput and quality at production-shaped concurrency?
  • Is an architectural change solving a measured bottleneck, or merely adding complexity?
