How to Protect Manufacturing Data When Deploying AI

Keep manufacturing data out of the wrong hands by treating an AI deployment as an OT security and resilience project, not as a stand-alone software installation. Inventory every data set and connection, define confidentiality, integrity and availability requirements, isolate AI from safety-critical control paths, restrict what people and providers can transmit, protect recovery copies, and continuously reassess suppliers and AI-specific attacks. The right design depends on each plant’s hazards, legacy equipment, network topology and regulatory obligations.

This guide applies a risk-based approach using NIST’s voluntary guidance. The initial public draft of the Cybersecurity Framework 2.0 Manufacturing Profile (IR 8183 Rev. 2) was published on September 29, 2025; its comment period closed November 17, 2025. It is intended to enhance—not replace—existing standards and plant procedures.

Why AI changes the manufacturing data problem

An AI system can consume production schedules, machine telemetry, recipes, quality images, maintenance records, engineering drawings and operator notes. Its outputs may influence inspection decisions, maintenance priorities, energy use or process settings. That creates more copies of sensitive information and more paths between shop-floor equipment, information technology (IT), cloud services and outside suppliers.

Protecting the data therefore means protecting three properties across the data, model, application and supporting hardware:

  • Read Before You Buy — No Video Output: These adapters support charging and USB 2.0 data transfer, but cannot transmit video signals. Except for standard USB webcams (which use USB data only), they are not compatible with HDMI/DisplayPort cables, video-capable USB-C hubs, or docking stations with video output.
  • Convert USB-A Ports to USB-C: Designed to connect USB-C earphones, cables, flash drives, card readers, and other USB-C accessories to standard USB-A ports. Plug-and-play with no drivers or software required.
  • Aluminum Alloy Housing: Built with a sturdy aluminum alloy shell that aids in heat dissipation and protects against daily wear and scratches. Designed to maintain a stable and secure connection.
  • Compact & Travel-Friendly: The ultra-compact design allows the adapter to stay plugged into your device without blocking adjacent ports or adding bulk, reducing wear and tear on your original USB ports.
  • 12-Month Warranty: Backed by a 12-month manufacturer warranty for peace of mind. Designed to meet strict quality control standards for reliable everyday performance.
  • Confidentiality: only approved people and services can see production information, intellectual property, personal data and security details.
  • Integrity: records, models, configurations and AI outputs cannot be altered without detection or authorization.
  • Availability: operators can continue safe production and recover required data and configurations if an AI service, network or system fails.

NIST’s manufacturing integrity project captures the objective: “As manufacturers embrace technology to boost productivity and gain efficiencies, they must also use it to bolster their cyber defenses to protect their people, data, and operations.” Read the project context at NIST’s Protecting Information and System Integrity in Industrial Control System Environments project.

AI also introduces risks in the underlying software and hardware. NIST notes that current guidance does not comprehensively cover several machine-learning attacks, including evasion, model extraction and membership inference. Controls must be revisited as techniques and products change; no framework eliminates these risks.

Define what is in scope before connecting an AI system

Inventory data by sensitivity and operational consequence

Create a register that names the owner, location, retention period, permitted users and worst credible consequence for each category:

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
  • Production plans, work orders, bills of material and inventory levels.
  • Quality measurements, inspection images, nonconformance records and traceability data.
  • Trade secrets such as recipes, process windows, tooling designs, source code and engineering drawings.
  • OT assets and information: programmable-controller logic, historian data, human-machine-interface screens, network diagrams, credentials, firmware and safety-system settings.
  • AI artifacts: prompts, training and fine-tuning data, feature sets, model weights, embeddings, logs, outputs, evaluation sets and feedback.
  • Recovery material: golden configurations, offline copies, certificates, license files and procedures needed to rebuild systems.

Mark data that may leave the plant, data that may be processed only in a specified country or region, and data that must never be sent to an external service. If classification is uncertain, route the data to the stricter handling category until the owner decides.

Inventory systems, identities and suppliers

List shop-floor devices, control networks, safety systems, historians, manufacturing execution systems (MES), enterprise-resource-planning systems, file shares, data lakes, model servers, cloud tenants, remote-access tools and every account or service identity that can reach them. Record software versions, support status, connectivity, physical location and the supplier responsible for updates.

Describe the complete data lifecycle

Document source, collection, transfer, storage, access, training or fine-tuning, inference, output, retention, deletion, backup and incident recovery. For every stage answer: who can access it, what is logged, where it is processed, how it is encrypted, how long it is kept, and how it is deleted or restored.

Map trust boundaries and keep AI away from unsafe control paths

Draw the actual flows rather than assuming a standard architecture. Show sensors and controllers, cell or line networks, supervisory control, historians and MES, enterprise applications, remote-access gateways, cloud services and AI providers. Mark each trust boundary, firewall or broker, data diode, API, jump host and vendor connection.

NIST’s SP 800-82 Rev. 3 Guide to Operational Technology (OT) Security, published September 28, 2023, emphasizes that OT security must account for performance, reliability and safety. A topology that is acceptable for one plant may be unsafe or unavailable in another because of legacy protocols, deterministic timing, hazardous processes or limited maintenance windows.

Use a staged connection pattern

  1. Read-only collection: copy the minimum required telemetry or documents from OT through an approved broker, historian replica or controlled export. Do not begin with write access to controllers.
  2. Buffer and inspect: validate schema, remove secrets and unnecessary identifiers, scan files, and quarantine malformed or unexpected data before it reaches the model.
  3. Analyze outside the control zone: run inference in a segregated analytics environment. Enforce egress rules and deny direct inbound connections from an external AI service to OT.
  4. Human review: route recommendations to an operator, engineer or quality authority. Require an independent check before any change to a process, recipe, set point or safety function.
  5. Controlled write-back, if justified: use a separately approved interface with range checks, dual authorization, complete audit logging and a tested manual fallback. A plant-specific hazard analysis must establish that the write path is safe.

Remote maintenance deserves the same scrutiny. Use named accounts, time-limited approval, strong authentication, session recording and a jump host; disable the path when work is complete.

Choose an architecture by risk, not by marketing label

There is no universally safest location for an AI workload. Compare alternatives against the same questions before selecting one.

Architecture Data exposure and processing location OT impact and access path Recovery and supplier questions
Plant or edge inference Data can remain on site; local storage and physical access become critical. Low latency is possible, but the appliance must be isolated from safety and control networks. Who patches the appliance? Are model files and configurations backed up and restorable without the supplier?
Private enterprise environment Centralized controls can simplify identity and logging; data crosses plant-to-enterprise links. Segmentation, bandwidth and outage behavior must be tested for each site. Define ownership of backups, keys, logs and model updates across business units.
External cloud or AI API Prompts, files or telemetry may leave the facility; confirm processing region, retention and secondary use. Outbound-only gateways and strict API scopes reduce exposure; latency and loss of service affect operations. Obtain written responsibility for sensitive information, backups, incident notification, deletion and subcontractors.
Disconnected pilot Uses masked or synthetic data with no production transfer. Safest way to validate usefulness before integration, but results may not represent live conditions. Plan how models, test data and findings will be securely moved if the pilot succeeds.

Set explicit confidentiality, integrity and availability requirements

Confidentiality controls

  • Minimize fields before transmission; tokenize product, customer and employee identifiers where analysis does not need them.
  • Encrypt data in transit and at rest, with keys controlled and rotated under the plant’s identity and access procedures.
  • Use role-based access and separate duties for data owners, model developers, operators and suppliers.
  • Prevent prompts, logs and uploaded files from being used for provider training unless the organization has explicitly approved that use.
  • Apply retention and deletion rules to temporary feature stores, cached files, embeddings and diagnostic logs—not only to the original database.

Integrity controls

  • Hash or digitally sign exported data, model packages and controller configurations; verify signatures before use.
  • Version data sets, prompts, code, dependencies and models so an output can be traced to the exact inputs and software.
  • Validate ranges, units, timestamps and provenance. Reject stale, duplicated or out-of-order sensor values.
  • Keep an immutable audit trail of approvals, model changes, privileged access and write-back actions.
  • Test models against corrupted, poisoned or adversarial inputs and define a safe response when validation fails.

Availability controls

  • Define the behavior when the model, network, cloud service or data source is unavailable: continue manually, use a previously approved model, or stop a process safely.
  • Monitor capacity, latency, queue depth and storage so an AI workload cannot starve control or quality systems.
  • Maintain independent non-AI procedures for inspection, maintenance and production decisions that affect safety or regulatory records.

Use a deployment process that creates evidence

  1. Write the use-case decision. State the operational problem, acceptable error, affected process, data needed and who has final authority. Separate advisory use from any action that changes equipment or product disposition.
  2. Perform a plant-specific risk assessment. Include hazards, legacy assets, safety instrumented functions, reliability targets, privacy, intellectual property, contractual duties and recovery time objectives.
  3. Approve the data inventory and flow diagram. Data owners should sign off on classifications, processing locations, retention, deletion and allowed recipients.
  4. Build a segregated test environment. Use masked, synthetic or historical copies where possible. Do not connect an untested model directly to live controllers.
  5. Threat-model the AI path. Consider prompt injection, data poisoning, model extraction, membership inference, evasion, credential theft, malicious updates and denial of service. Record preventive and detective controls.
  6. Test failure and unsafe-output cases. Inject missing, delayed, extreme and contradictory values; verify that the system rejects them or routes them for review. Test loss of network, provider outage and corrupted model files.
  7. Approve a limited pilot. Restrict sites, users, data volume and time. Measure accuracy and operational effects without allowing autonomous control.
  8. Gate production access. Require documented owner approval, least-privilege identities, logging, segmentation, backup verification and a rollback plan before expanding scope.
  9. Monitor and review. Compare model performance, drift, access events, data egress, latency and safety indicators with defined thresholds. Suspend the integration when a threshold is breached.
  10. Retire cleanly. Revoke credentials, remove integrations, delete provider copies according to contract, preserve required records and verify that backups and documentation no longer depend on the retired service.

Control people, prompts and external providers

Rules for employees and contractors

Publish a short, enforceable data-handling standard. It should identify approved AI tools, prohibited inputs, required redaction, review duties and the process for reporting accidental disclosure. Staff who operate connected machines or work with suppliers need training that includes social-engineering recognition, suspicious prompt or file handling, credential protection and escalation contacts.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

NIST’s manufacturing cybersecurity guidance recommends an annual risk assessment and a cybersecurity awareness and training program. Repeat training after major system or supplier changes rather than treating the annual event as the only control.

Questions for an AI or cloud provider

  • Where are prompts, files, embeddings, logs and backups processed and stored?
  • Are customer inputs retained, used for model improvement, or shared with subcontractors?
  • Which personnel can access the data, and how are their actions logged?
  • How are tenant isolation, encryption, key management, vulnerability handling and software updates implemented?
  • What availability, latency and outage commitments apply, and what is the manual fallback?
  • Who is responsible for backups and sensitive information, and how can the customer verify deletion or obtain data for recovery?
  • How are model versions, training-data changes and emergency updates communicated and approved?
  • How quickly will the provider notify the plant of a breach, integrity failure or material service change?

These are implementation questions to resolve in contracts and operating procedures; they are not a claim that any one NIST document mandates a particular clause.

Make recovery independent of the AI service

Maintain protected, encrypted backups of OT configurations and the data required to restore operations, including controller programs, HMI and historian settings, network and firewall rules, certificates, license information and approved model packages. Keep at least one copy isolated from normal administrative credentials and from ransomware-prone networks.

Assign an owner for backup frequency, encryption keys, media custody and retention. Confirm in writing whether a provider backs up its service and whether the customer can retrieve those copies in a usable format. Test restoration under site procedures, including a scenario in which the AI provider and the enterprise network are unavailable. Record the time, dependencies and manual steps needed to return to a safe operating state.

Manage suppliers as part of cybersecurity supply-chain risk

AI introduces risk through models, libraries, chips, appliances, data pipelines, integrators and managed services—not only through the visible application. NIST SP 800-161 Rev. 1 Update 1 (published November 1, 2024, updated January 6, 2025) recommends integrating cybersecurity supply-chain risk management at multiple organizational levels, including product and service assessments.

Use a repeatable supplier review

  1. Classify the supplier by access to OT, sensitivity of data, operational criticality and concentration risk.
  2. Review architecture, subcontractors, software bill of materials where available, update channels, vulnerability disclosure and remote-access practices.
  3. Verify identity integration, logging, incident notification, backup responsibilities, data location and deletion capability.
  4. Require evidence that updates and model artifacts are authenticated and can be rolled back.
  5. Set reassessment triggers: ownership change, new data type, expanded site access, major model update, vulnerability or service outage.

Keep the assessment and accepted exceptions in the same risk register as plant assets. Supplier assurances do not replace testing and monitoring in the facility.

Use NIST guidance as a coordinated set

Document How it helps this deployment Status and scope
NIST IR 8183 Rev. 2 Manufacturing Profile Maps Cybersecurity Framework 2.0 outcomes to manufacturing, including Govern, supply-chain risk, platform security and technology-infrastructure resilience. Initial public draft dated September 29, 2025; voluntary guidance, not a final profile.
NIST SP 800-82 Rev. 3 Explains OT topologies, threats, vulnerabilities and countermeasures while addressing safety, reliability and performance. Published September 28, 2023.
NIST AI Risk Management Framework 1.0 Provides voluntary practices for incorporating trustworthy characteristics into AI design, development, use and evaluation. Released January 26, 2023; companion Playbook published in 2023.
NIST SP 800-161 Rev. 1 Update 1 Structures strategy, policies, plans and assessments for products and services across the supply chain. Published November 1, 2024; updated January 6, 2025.
NIST NCCoE manufacturing ICS integrity project Provides example approaches for reducing information and system-integrity risks in industrial control environments. Finalized project; examples do not constitute a plant-specific certification or vendor endorsement.

Use these documents to organize decisions, then map the resulting controls to the standards, safety processes, contracts and legal obligations already used at the plant. Adoption alone does not establish compliance or guarantee protection.

Monitor for drift, misuse and emerging attacks

Operational and security signals

  • Unexpected data egress, new destinations, unusual prompt volume or access outside approved shifts.
  • Changes in model version, feature distribution, confidence, false rejects, false accepts or sensor-quality indicators.
  • Integrity failures such as unsigned packages, altered configurations, clock discrepancies or unexplained historian gaps.
  • Latency, queue growth, storage exhaustion and provider errors that could affect production decisions.
  • Repeated attempts to submit secrets, bypass policy or manipulate an output through crafted inputs.

Response branches

  • Suspected disclosure: stop the affected transfer, preserve logs, revoke tokens, identify copied data and notify the data owner and incident team.
  • Suspected integrity compromise: quarantine the model or data source, compare against signed known-good versions, and require engineering approval before reactivation.
  • Unsafe or unavailable service: switch to the documented manual or non-AI fallback; do not weaken OT segmentation to restore convenience.
  • Supplier incident: invoke notification and evidence provisions, restrict access, assess other sites using the same component and decide whether to suspend updates.

Practical readiness checklist

  • Every AI use case has a named business, OT and security owner.
  • Data categories, owners, retention and permitted processing locations are documented.
  • Flows from devices through OT, IT, cloud and providers show trust boundaries and remote paths.
  • Read-only collection is the default; any write-back has hazard analysis, range checks, dual approval and rollback.
  • Confidentiality, integrity and availability requirements cover data, models, software and hardware.
  • Encrypted, isolated backups of OT configurations and recovery data have a responsible owner and a tested restoration procedure.
  • Employees and suppliers follow approved-tool, redaction, reporting and social-engineering rules.
  • Supplier assessments cover subcontractors, updates, access, data use, backups, deletion and incident notification.
  • Monitoring detects egress, drift, integrity changes, latency and unsafe outputs.
  • Risk reviews are repeated after model, plant, supplier or threat changes, with explicit attention to evasion, extraction and membership-inference risks.
