How to Monitor GPU Cloud Reliability, Capacity, and Job Failures

Reliable GPU-cloud operations require more than a GPU-utilization chart. Correlate DCGM health events with node, Kubernetes or Slurm, application, network, storage, and provider-maintenance telemetry; measure service availability separately from usable capacity; and preserve enough job and checkpoint context to attribute failures and recover safely.

What GPU-cloud reliability actually measures

GPU reliability has three related but different questions:

As an Amazon Associate I earn from qualifying purchases.

  • Can a customer use the service? This is service availability: authentication, API responses, allocation, and launch or readiness checks succeed within the promised window.
  • Is the requested GPU capacity genuinely usable? Capacity availability measures whether eligible GPUs can be allocated, not merely whether they exist somewhere in an inventory system.
  • Can a running job finish useful work? Job reliability covers scheduler placement, GPU health, node stability, network and storage paths, application behavior, and checkpoint recovery.

A healthy GPU can still sit behind a failed scheduler, an exhausted quota, a saturated filesystem, or a broken network path. Conversely, a failed training job does not automatically mean the GPU was defective. Monitoring must preserve the relationships between each layer so an incident can be reconstructed rather than guessed at.

Service availability and capacity availability are separate SLIs

Do not combine an API uptime percentage with an inventory percentage. Define two service-level indicators (SLIs), each with its own eligible population, test, interval, and exclusions.

SLI What to test Useful dimensions Example official interval
Service availability Customer-visible authentication plus a small allocation or launch check Offering, region, tenant class, and endpoint NVIDIA’s current Cloud Services SLA tracks status every 15 minutes over a calendar month; shorter gaps than that interval are excluded from its calculation.
Capacity availability Whether eligible GPU capacity can actually be allocated at the requested type, region, and tenancy GPU type, zone, region, quota, and placement policy The same SLA measures capacity over a calendar month and tracks it every 60 minutes; shorter gaps than that interval are excluded.

Those intervals belong to NVIDIA’s published SLA, not to every provider. An internal SLO should state its own measurement cadence and exclusions. Record incident start and end, affected offering, attempted operation, affected users, and the capacity pool involved. Without that evidence, an availability number cannot be audited.

Build a layered telemetry pipeline

A practical architecture has four functions: collectors, a time-series database, visualization, and alerting. NVIDIA describes this as a common monitoring-stack pattern. Prometheus can store and query metrics, Grafana can display dashboards, and Alertmanager can route alerts. In Kubernetes, kube-state-metrics adds object and scheduling state, while node_exporter supplies operating-system signals. DCGM Exporter exposes NVIDIA GPU metrics for Prometheus and is deployed by default with the NVIDIA GPU Operator.

Collection and transport

Run GPU collectors on every eligible node, not only on a monitoring control plane. Collectors should expose a scrape-health metric and a timestamp or freshness indicator. A missing scrape is an observability failure, not evidence that the GPU is idle. Forward provider events, maintenance notices, quota responses, and API errors through the same incident timeline as metric samples.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Storage and retention

Keep high-resolution data long enough to investigate a failed job and lower-resolution rollups long enough to plan capacity. Retention should cover the longest checkpoint, incident, and procurement cycle relevant to your organization. Preserve event records separately from sampled metrics so a short XID, eviction, or maintenance event is not lost between scrapes.

Labels without unbounded cardinality

Useful dimensions include cluster, region, zone, node, GPU identifier, namespace, pod, team, and workload. Job IDs and container hashes can create unbounded label growth when attached to every high-frequency GPU sample. Keep stable ownership and placement labels on metrics; store highly variable identifiers in logs or event records and join them during investigation.

Collect the signals that explain GPU behavior

At the GPU layer, DCGM is designed for health and performance telemetry and can integrate with cluster-management and scheduling tools. Collect the following signals together:

Signal Why it matters Typical investigation question
Compute utilization Shows whether allocated accelerators are doing work; distribution is more useful than one average Is a job stalled, or is it legitimately using a small fraction of a large allocation?
Memory use and pressure Distinguishes an application memory problem from idle capacity Is memory exhausted while compute remains low?
Temperature and power Highlights thermal throttling, cooling problems, or abnormal power behavior Did throughput fall after a thermal or power excursion?
ECC and XID events Provides hardware and driver fault evidence Does the error recur on one GPU UUID or across a node?
NVLink and interconnect errors Distributed jobs can fail even when individual GPU utilization looks normal Did a collective operation slow or abort on a damaged link?
Exporter and scrape health Separates a telemetry outage from a GPU outage Did the dashboard go blank because the collector failed?

Track GPU UUID, node, driver version, runtime version, and firmware or image context in the event record. A metric without a stable physical identity cannot establish whether the same accelerator is repeatedly involved.

Monitor node and cluster conditions around every GPU

GPU telemetry must be correlated with node readiness, driver and runtime health, filesystem saturation, network saturation, pod placement, and time-series gaps. A node can report normal GPU utilization while kubelet health, PCIe paths, local disks, or the container runtime are failing.

  • Readiness and lifecycle: record node-ready transitions, taints, cordons, drains, reboots, and replacement events.
  • Software compatibility: capture kernel, NVIDIA driver, container runtime, CUDA or equivalent runtime, and image versions associated with each job.
  • Resource accounting: compare requested GPUs with allocatable GPUs and the placement actually granted to pods or scheduler steps.
  • Host pressure: alert on CPU, RAM, filesystem, inode, PCIe, and network saturation that can starve an otherwise healthy accelerator.
  • Telemetry continuity: detect missing samples, delayed scrapes, and exporter restarts as first-class incidents.

Keep cluster, zone, node, GPU, namespace, pod, team, and workload context available for drill-down. Do not infer node health from a single aggregate cluster chart.

Measure capacity that is usable, not merely owned

Capacity monitoring answers whether a new request can start now and whether the pool will remain sufficient later. Count GPUs by type, region, zone, and tenancy, then explain every unit’s state.

Use mutually clear inventory states

State Definition to document Why it prevents a false conclusion
Allocatable Capacity the scheduler is permitted to place after health, taint, quota, and policy filters An installed GPU may be excluded from allocatable inventory.
Reserved Capacity committed to a reservation or placement decision but not yet running a workload It may appear free at the hardware layer while being unavailable to a new customer.
Occupied Capacity assigned to running or admitted jobs An allocation can be mostly idle and still block another request.
Free and usable Allocatable capacity not reserved, occupied, quarantined, or blocked by placement rules This is the number that should drive an admission or capacity-availability test.
Quarantined Removed from scheduling because of health, investigation, or maintenance It prevents a bad GPU from being counted as available.

Make the categories non-overlapping in the exported data. If a reservation overlaps an occupied allocation, represent the relationship in separate fields rather than adding both numbers and overstating demand.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Track demand and contention

  • Queue depth and oldest pending age by GPU type, region, zone, tenant, and priority.
  • Admission failures, quota exhaustion, and placement failures, with their reasons.
  • Requested versus granted GPU count and the time from submission to start.
  • Utilization percentiles, such as p50 and p95, plus memory pressure and idle allocation time.
  • Fragmentation: GPUs that are technically free but cannot satisfy the requested shape or topology.
  • Committed capacity, forecast demand, procurement lead time, and planned headroom.
  • Minutes of capacity shortfall that caused a real customer impact, rather than every moment an internal target was missed.

Forecast before the queue becomes an incident

NVIDIA’s AI-cloud requirements call for utilization to be monitored and forecast against available capacity. A useful forecast separates baseline demand, scheduled reservations, growth, and known procurement lead time. Show the forecast by GPU type and location; a surplus of one accelerator model does not satisfy a request for another model or topology. Mark confidence and assumptions, and alert on projected headroom crossing a defined threshold rather than on a vague aggregate percentage.

Instrument Slurm or Kubernetes scheduling

Scheduling telemetry explains why a GPU is visible but a job cannot start. Whether the environment uses Slurm, Kubernetes, or both, capture state transitions rather than only final outcomes.

Scheduler metrics to retain

  • Queue depth, pending age, priority, requested resources, and pending reason.
  • Admission, quota, and placement failures, including the rejected constraint.
  • Submission-to-start latency and time spent waiting for each resource class.
  • Running, completing, failed, cancelled, preempted, and retried states.
  • Exit status, termination signal, eviction reason, and retry count.
  • Actual allocation and utilization compared with the request.
  • Scheduler-cycle latency and control-plane health.

Slurm’s 25.11 metrics guide introduced comprehensive metrics for resources, job states, and scheduler performance. If you operate that release, use its native metrics where possible and retain the version in your telemetry metadata. A metric name or state can change between scheduler releases, so dashboards should show the exporter and scheduler version.

Queueing is not the same as an outage

A growing queue may reflect legitimate demand, a quota policy, fragmentation, or an unavailable zone. Break the queue down by pending reason and requested shape. Alert on oldest pending age and customer impact, not only on the number of waiting jobs. A job waiting for a deliberately low-priority reservation is different from one rejected because every eligible node is unhealthy.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Preserve a durable record for every job

Create the job record before launch so failure analysis does not depend on logs that may disappear with a pod or node. At minimum, store:

  • Job, workflow, owner, team, and scheduler identifiers.
  • Code revision, container or image version, driver and runtime versions.
  • Requested GPU type and count, topology or placement constraints, and the actual node and GPU UUIDs.
  • Checkpoint location, checkpoint cadence, last successful checkpoint, and expected heartbeat or throughput.
  • Submission, admission, start, checkpoint, termination, retry, and resume timestamps.

Join this record with application logs, kernel and system logs, GPU events, network and storage metrics, scheduler state, and provider-maintenance data. A final exit code without that context cannot distinguish an application bug from a failed interconnect.

Diagnose failures by evidence, not by the last visible error

Use a consistent sequence when a job stalls or exits:

  1. Detect: identify a missing heartbeat, stalled throughput, abnormal exit, failed collective, or GPU/system error.
  2. Enrich: attach cluster, zone, node, GPU UUID, pod or step, driver, image, owner, and recent maintenance events.
  3. Classify: choose the leading domain: application, scheduler, capacity, node, GPU, network, storage, or provider incident.
  4. Test the hypothesis: compare the affected resource with healthy peers and check whether the symptom follows the job, node, GPU, or location.
  5. Contain: quarantine or cordon a suspect resource only after a defined evidence threshold; drain workloads safely.
  6. Recover: retry with bounded attempts, changed placement, or a checkpoint resume.
  7. Learn: record recovery duration, lost GPU-hours, customer impact, and whether the same resource recurs.

Fault-attribution guide

Likely domain Evidence to correlate First operational response
Application Assertion, deterministic exception, out-of-memory message, or reproducible failure across different nodes Stop automatic retries that would repeat the same bug; preserve logs and input metadata.
Scheduler or policy Pending reason, preemption, quota response, placement constraint, or eviction event Explain the policy outcome and correct the request, quota, or priority.
Capacity Admission failure, no eligible shape, fragmented inventory, or provider capacity error Offer an approved alternate pool or queue; record the shortfall minutes.
Node Node-not-ready transition, runtime failure, host pressure, filesystem, or reboot event Cordon, drain, repair, and validate before returning the node.
GPU or driver Repeated ECC or XID events, thermal or power anomaly, exporter evidence, or recurrence on one UUID Quarantine the GPU or node according to the repair policy and preserve the hardware identity.
Network or interconnect NVLink or fabric errors, packet loss, retransmits, collective timeout, or topology-specific slowdown Move the job to a verified topology and investigate the path or switch.
Storage Checkpoint latency, I/O errors, filesystem saturation, or failed reads and writes Protect the last valid checkpoint and repair or replace the storage path.
Provider incident Maintenance notice, API failure, quota-system event, or correlated failures across tenants Attach the provider event to the incident and avoid blaming individual GPUs without local evidence.

Detect a bad GPU before it crashes a distributed job

Single-device checks are necessary but insufficient. A distributed job can expose a marginal link, thermal condition, or driver problem only under collective traffic. Combine continuous DCGM signals with job-level symptoms and recurrence analysis.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Set evidence thresholds

Define in advance which events cause an alert, which cause a quarantine recommendation, and which require immediate isolation. A transient warning should not remove an entire node; repeated uncorrectable errors, a dangerous thermal condition, or a recurring job failure tied to one UUID may justify quarantine. Thresholds should account for event severity, recurrence, peer comparison, and whether the GPU is currently serving a critical workload.

Use safe isolation

When evidence crosses the threshold, cordon the node or mark the GPU unschedulable, then drain workloads according to their disruption policy. Record who or what performed the action, the triggering evidence, and the validation required for release. Do not silently hide a failed GPU by deleting its metrics; preserve the identity and event history.

Automate recovery, but keep it bounded and auditable

NVIDIA’s NVSentinel design combines GPU health, system logs, and cloud-provider maintenance events, then takes action. NVIDIA Autonomous Job Recovery similarly describes checkpoint monitoring, failure attribution, isolation across compute, network, storage, node, GPU, and software signals, and restart or resume actions.

Automation should follow explicit guardrails:

  • Retry only when the failure class is retryable and the checkpoint is known to be valid.
  • Limit attempts, total retry time, and GPU-hours consumed.
  • Change placement after a resource-linked failure instead of replaying on the same suspect node.
  • Require a clean health check before returning a quarantined resource to service.
  • Write every action, decision, operator override, and rollback to an audit record.
  • Measure recovery duration, lost GPU-hours, checkpoint age at failure, and recurrence by resource.

Automatic restart is not a substitute for attribution. Repeating a deterministic application error can multiply cost and obscure the original cause.

Define alerting and incident ownership

Use severity levels that map to an action. NVIDIA’s AI-cloud requirements specify at least three incident-severity levels, 24x7x365 on-call coverage, alert-acknowledgement tracking, and telemetry-ingestion latency of no more than 120 seconds. Treat those as requirements cited by NVIDIA for its AI-cloud context, not as a universal legal standard.

Alert class Example trigger Required evidence Owner
Critical Customer-visible allocation outage, widespread job failure, or unsafe hardware condition Impact, start time, affected pool, live jobs, and provider events On-call incident commander and platform owner
High Repeated GPU errors, node instability, or rapidly growing pending age Resource identity, recurrence, queue impact, and containment status GPU or scheduler operations
Advisory Forecast headroom, rising fragmentation, exporter gaps, or a non-critical thermal trend Trend window, threshold, and planned action Capacity or reliability engineering

Measure alert delivery delay, acknowledgement time, time to containment, time to recovery, and false-positive rate. A dashboard that looks complete but arrives two minutes late can miss a short-lived failure; a dashboard with no ownership becomes a passive chart.

Implement monitoring in a practical sequence

  1. Inventory the service: list GPU types, regions, zones, tenants, schedulers, node pools, drivers, and storage and network dependencies.
  2. Define the SLIs: document the customer-visible service test, eligible capacity pool, interval, exclusions, and incident-record fields.
  3. Deploy collectors: install DCGM Exporter and node and Kubernetes collectors on every eligible node; verify scrape health and version metadata.
  4. Ingest scheduler state: export queue, pending reason, resource request, placement, start latency, state, exit status, preemption, and utilization.
  5. Normalize identity: join cluster, zone, node, GPU UUID, pod or step, job, team, and workload without turning volatile IDs into unbounded metric labels.
  6. Add provider events: ingest maintenance, capacity, quota, API, and incident notifications with timestamps and affected scope.
  7. Create four dashboards: fleet health, capacity and forecast, scheduler and queue, and job failure investigation. Every panel should support drill-down to a stable resource or job identity.
  8. Write alert rules: include freshness, hardware health, queue age, admission failures, capacity shortfall, and job heartbeat or throughput anomalies.
  9. Test failure paths: simulate a missing scrape, node drain, quota rejection, checkpoint delay, and a controlled GPU or network fault in a safe environment.
  10. Automate cautiously: enable quarantine, drain, retry, and resume only after thresholds, retry budgets, validation checks, and audit logging are in place.
  11. Review monthly: compare SLI results with lost GPU-hours, repeat offenders, forecast error, alert acknowledgement, and unresolved telemetry gaps.

Compare monitoring tools or GPU-cloud providers on these criteria

Product names matter less than whether the implementation can connect an event to a customer impact. Use a written scorecard before selecting a stack or provider.

Criterion Questions to ask
Signal coverage Are GPU, node, Kubernetes, Slurm, application, network, storage, and provider events all available?
Attribution Can an alert resolve to cluster, zone, node, GPU UUID, pod, namespace, job, and team?
Freshness and loss What are scrape latency, event-delivery delay, sample gaps, and retention periods?
Capacity semantics Does the system distinguish allocatable, reserved, occupied, quarantined, and usable capacity, and can it forecast demand?
Scheduler integration Are pending reasons, pending age, placement failures, preemption, exit data, and actual utilization exposed?
Recovery controls Does it understand checkpoints, support safe retry and alternate placement, quarantine resources, and preserve an audit trail?
Operations Are there 24×7 response arrangements, acknowledgement tracking, runbooks, escalation paths, and investigation retention?

Common monitoring mistakes and their fixes

Watching only average GPU utilization

An average can hide one failed accelerator, memory pressure, or a distributed collective waiting on a single rank. Use distributions, per-UUID views, and job throughput.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Counting installed inventory as available capacity

Exclude unhealthy, quarantined, reserved, quota-blocked, and topology-incompatible GPUs from the usable count. Publish the state definitions alongside the chart.

Alerting on a missing metric as a hardware failure

Check exporter, scrape target, network, and time-series freshness first. A telemetry outage needs its own alert and incident path.

Retrying without a checkpoint or placement change

Record checkpoint progress and bound retries. If the same node or GPU is implicated, change placement or quarantine the resource.

Discarding scheduler reasons

A queue-length number cannot explain quota exhaustion, fragmentation, preemption, or an invalid constraint. Preserve the reason and the requested shape.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Ignoring provider maintenance

Join maintenance and capacity events to local telemetry. A correlated regional failure should not be misclassified as a series of unrelated GPU defects.

Letting labels grow without limit

Keep stable ownership and placement labels in metrics; move high-cardinality job and container identifiers to logs or event stores.

A complete incident timeline for a distributed-training failure

Suppose throughput falls to zero while GPUs still report utilization. The investigation should reconstruct events in this order:

  1. The job record identifies the workflow, image, requested topology, checkpoint, and assigned GPU UUIDs.
  2. The scheduler shows the job is still running, so this is not initially a queue or preemption problem.
  3. Application logs show a collective-operation timeout on one rank.
  4. DCGM reports an interconnect error on that rank’s GPU, while peer GPUs remain within normal temperature and power ranges.
  5. Node and network telemetry confirms packet loss or link errors on the same path; storage and checkpoint metrics show the last checkpoint completed successfully.
  6. The platform cordons the suspect resource, drains according to policy, and resumes from the known checkpoint on a different verified placement.
  7. The incident record captures downtime, checkpoint age, lost GPU-hours, recovery duration, and whether the resource has caused earlier failures.

This chain is more useful than labeling the event simply as a failed training job: it identifies the affected resource, protects progress, and supplies evidence for repair or provider escalation.

Operational checklist

  • GPU health includes utilization, memory, temperature, power, ECC, XID, interconnect, and scrape status.
  • Node telemetry includes readiness, driver and runtime health, filesystem, network, placement, and pressure.
  • Scheduler data includes queue, pending reason, requested and granted resources, start latency, state, exit status, retries, and preemption.
  • Capacity reports separate allocatable, reserved, occupied, free, quarantined, and forecast inventory.
  • Every job has durable ownership, version, placement, heartbeat, checkpoint, and termination records.
  • Provider maintenance, quota, API, and capacity events share the incident timeline.
  • SLIs specify customer-visible tests, windows, exclusions, eligible pools, and incident accounting.
  • Alerts have severity, ownership, acknowledgement tracking, runbooks, and freshness limits.
  • Recovery automation has retry budgets, alternate placement, validation, rollback, and audit logs.

The dependable operating model is a closed loop: collect signals at every layer, join them by stable identity, distinguish service failure from capacity shortage, attribute each job failure with evidence, and automate only the recovery actions that are bounded and reviewable.
