How to Monitor AI Applications in Production for Quality and Reliability

An AI feature can stay online while its answers become less useful, its tools start failing, or users stop completing the task it was built for. Reliable production monitoring therefore needs three connected views: application and system health, user and business outcomes, and model and AI quality. Keep ordinary service observability, then add task-specific output evaluation and feedback; no single “AI quality score” can describe every use case.

What production monitoring needs to measure

A green uptime graph tells you that requests are reaching a service. It does not tell you whether the service is returning supported answers, choosing the right tools, or helping users finish their work. AWS frames production monitoring for generative AI around three pillars: application and system health, business and user outcomes, and model quality (AWS production-monitoring guidance).

Monitoring layer Question it answers Examples of signals
Application and system health Can the service handle requests reliably and within its operating limits? Availability, request volume, latency, errors, throttles, resource utilization, token use, and cost.
User and business outcomes Does the feature help users accomplish the intended task? Task completion, repeat use or engagement, user feedback, customer satisfaction, and the business KPI the feature is meant to affect.
Model and AI quality Are outputs and decisions appropriate for this particular job? Relevance, correctness, grounding, instruction adherence, safety, and tool-selection correctness.

Select measures based on the application’s task and risks. A support assistant, a document extractor, and an agent that changes account settings do not need identical quality checks. A metric is useful only when its definition, evaluation method, and intended decision are clear.

Define outcomes and reliability goals first

Start with the user’s task, then identify what a successful request looks like. Translate that outcome into a small set of technical and product measures, and decide in advance what levels are acceptable and who responds when they are missed. Google Cloud recommends connecting reliability goals and technical metrics to KPIs rather than treating infrastructure metrics as the whole definition of success (Google Cloud reliability guidance).

  • Define success: Specify the user-visible result that counts as completion, including how you handle partial completion, refusal, or escalation to a person.
  • Set service objectives: Choose limits for request success, response time, and resource or quota use that match the product’s needs.
  • Choose quality criteria: Define what “good” means for the task, such as grounded answers for retrieval, correct fields for extraction, or valid tool choices for an agent.
  • Assign ownership: Name the team or person responsible for each alert and provide a runbook with the next diagnostic steps.

Keep each measure tied to an operational decision. For example, a rise in failed task completion should lead to investigation of the affected workflow, while a latency alert should point to the relevant service path or dependency.

Trace the full request path

Record enough linked context to follow one user request through the application, retrieval or context assembly, model calls, agent decisions, tool and API calls, and final response. This matters especially for agents: a poor result may come from a model decision, a tool response, retrieval, orchestration, or an infrastructure failure. Google Cloud recommends using logs, metrics, and traces to troubleshoot agent executions, while CloudWatch documents end-to-end prompt tracing and monitoring for models, knowledge bases, tools, and agents (Google Cloud agent observability; Amazon CloudWatch generative AI observability).

Give logs, metrics, and traces distinct jobs

  • Logs capture individual events, errors, decisions, and relevant context for investigation.
  • Metrics show aggregate trends and support thresholds or anomaly detection.
  • Traces connect the stages of one execution and show where time or failures accumulated.

Carry a request or trace identifier across components. For each relevant step, record timestamps, status or error outcome, component identity, and the model and prompt versions involved. Include token use and evaluation or feedback signals where applicable. Preserve version context for code and relevant data or evaluation sets so an observed change can be investigated against the version that produced it.

Monitor service health, latency, and cost

Keep conventional service monitoring in place: request traffic, latency distributions, errors, throttles or quota failures, availability, and resource saturation. For an LLM request, separate end-to-end latency from the latency of its individual steps so a slow response can be localized. If the interface streams output, measure time to first token and the behavior of token delivery as well as time to completion; these can affect the user experience differently. Google Cloud includes reliability considerations for AI/ML systems, and CloudWatch documents invocation counts, token usage, average and percentile latency, errors, throttles, and cost attribution (Google Cloud reliability guidance; CloudWatch generative AI observability).

Break down usage and cost by useful workload or application dimensions so changes are actionable. Avoid adding high-cardinality or sensitive values as metric labels; put detailed context in access-controlled traces or logs instead. Monitor token consumption alongside traffic because a change in prompt size, output length, or call pattern can alter capacity and cost even when request counts remain steady.

Evaluate output quality and safety in production

Turn the feature’s job into explicit evaluation criteria. Depending on the task, assess correctness or factuality, relevance, grounding in supplied context, instruction adherence, style, safety, or whether an agent selected the right tool. Keep a stable baseline set of representative examples so changes can be compared rather than judged against a shifting standard. Google Cloud recommends continuous evaluation of generative AI outputs and human-in-the-loop review for quality and safety (Google Cloud operational excellence guidance).

Use automated checks as signals, not proof

Automated metrics and judge models can help review more outputs, but their results depend on the evaluation method, data, and task definition. Calibrate them against human judgment and document what a check can and cannot detect. A “groundedness” score, for example, is evidence from a particular method and sample; it does not prove that hallucinations have been eliminated.

Review representative traffic and escalate important cases

Evaluate representative production samples and examine changes in scores, failure categories, or user feedback. Include human review for ambiguous cases and applications where an error could have significant consequences. Define how a questionable output is escalated and what action follows, rather than treating a score alone as a resolution.

Measure whether users accomplish the task

Pair technical and output measures with task completion, repeat use or engagement, user feedback, and the business KPI the feature is intended to influence. A service can return syntactically valid answers quickly while users abandon the workflow or repeatedly seek corrections. AWS identifies adoption, customer satisfaction, and business impact as a distinct production-monitoring pillar (AWS production-monitoring guidance).

Interpret these signals in context: a lower completion rate may reflect an AI problem, a change elsewhere in the product, or a shift in the requests reaching the feature. Compare relevant versions and user segments where appropriate, while limiting collection to data needed for the investigation.

Alert, investigate, and roll out changes safely

Set thresholds or anomaly detection for service symptoms and for the quality indicators that matter to the task. Alerts should name an owner, link to the relevant dashboard or trace search, and provide a runbook. For model, prompt, or data changes, compare results with a stable version, release to a limited audience where appropriate, observe the change, and retain a rollback path. Google Cloud recommends controlled or canary releases, alerts for quality shifts or harmful content, and rollback planning (Google Cloud operational excellence guidance).

  1. Detect: Identify whether the initial signal is a service incident, a quality shift, or a user-outcome change.
  2. Localize: Use the request trace and linked logs to find the step, dependency, model, prompt, or tool associated with the change.
  3. Assess impact: Check affected workloads and representative examples, and involve human review for uncertain or high-impact cases.
  4. Mitigate: Apply the runbook action, which may include disabling a failing path, reverting a release, or routing cases for human handling.
  5. Verify: Confirm that the relevant service, quality, and user-outcome signals recover before closing the incident.

Protect telemetry and preserve audit context

Prompt and response traces can contain detailed user or business content. Restrict who can inspect them, define retention periods, and use redaction or sensitive-data protections appropriate to the application. AWS lists sensitive-data protection among its observability controls; Google Cloud’s reliability guidance emphasizes lineage and auditability across AI assets (CloudWatch generative AI observability; Google Cloud reliability guidance).

Choose an observability approach that fits your stack

An LLM observability platform is useful when it helps a team connect executions, inspect failures, evaluate outputs, and act on issues in its existing operational workflow. Tool selection should account for instrumentation fit, trace completeness, evaluation and human-calibration needs, alerting, data residency and access controls, deployment options, cost model, and the operational effort required to maintain it.

Option Documented capabilities What to validate for your workload
Amazon CloudWatch generative AI observability AWS documents prompt tracing, model, agent, and tool monitoring; invocation and token dashboards; latency percentiles, errors, throttles, quality signals, and cost attribution. Its documentation also describes AWS and third-party model traces via ADOT. CloudWatch documentation Check that instrumentation covers the components you use, and verify current data controls, retention, deployment, and cost fit.
Google Cloud agent observability Google Cloud documentation describes logs, metrics, traces, execution paths, quality evaluation, and OpenTelemetry GenAI semantic conventions. Agent observability documentation Check how it integrates with your runtime and incident workflow, and whether its evaluation and data controls meet your requirements.
LangSmith LangSmith vendor documentation describes dashboards for token usage, latency, errors, cost, feedback, alerts, framework integrations, and hosted, BYOC, or self-hosted deployment options. LangSmith observability Validate the vendor-described features, current terms, deployment model, privacy controls, and framework fit against your specific requirements.

These documented feature descriptions are not a neutral benchmark or evidence that one option will perform better for a particular workload. Compare candidates using the same representative traces and evaluation tasks, and confirm their current terms and data handling directly before adopting one.
