How to Migrate AI Workloads from One GPU Cloud Provider to Another

The safest GPU-cloud migration treats compute as replaceable and state as portable. Package your application and its user-space CUDA stack in an OCI container, keep datasets and checkpoints in durable storage, provision an equivalent destination GPU, copy data in bulk followed by verified deltas, and prove correctness and performance with real workloads before switching traffic.

A migration can be a simple rehost or a substantial refactor. The right path depends on GPU memory and interconnect requirements, framework and driver compatibility, storage and network throughput, quotas, regional availability, security controls, and the total cost of completing useful work rather than the hourly GPU rate alone.

As an Amazon Associate I earn from qualifying purchases.

Choose the migration strategy before changing infrastructure

Classify the move as a rehost, replatform, or refactor. Microsoft’s migration guidance uses these three strategies, and the distinction prevents a team from trying to redesign an application while it is also trying to preserve service continuity.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
Strategy What changes When it fits Main risk
Rehost Move the existing container, job definitions, data, and serving configuration with minimal code changes. The destination offers a compatible GPU generation, driver, storage interface, and orchestration environment. Provider-specific assumptions remain and may continue to limit portability or cost efficiency.
Replatform Keep application behavior but change managed services, Kubernetes configuration, storage classes, transfer tooling, or autoscaling. You want better operations or economics without changing model code. Differences in identity, networking, quotas, and observability can create hidden work.
Refactor Redesign data pipelines, distributed training, serving, or scheduling for the new platform. The move is driven by a new accelerator architecture, multi-region design, or a materially different operating model. Functional and performance equivalence is harder to establish, extending the parallel-run period.

Set a target for each phase: preserve behavior, reduce cost per training step, improve availability, or remove a provider dependency. A migration without a measurable target can finish technically while making the workload slower or more expensive.

Inventory the workload and its hidden dependencies

Create an inventory from running jobs, image manifests, infrastructure code, experiment tracking, and production runbooks. Record the following before requesting destination capacity:

  • Software: framework and exact version, Python and system packages, CUDA and CUDA-X libraries, cuDNN or other accelerator libraries, compiler requirements, and the image digest used in production.
  • Accelerator profile: GPU model, memory per GPU, number of GPUs per process and per node, compute capability, tensor-core features, MIG or time-sharing use, and whether the code assumes a particular instruction set.
  • Scale-up topology: NVLink or another high-speed GPU interconnect, host PCIe layout, InfiniBand or equivalent networking, collective-communication library settings, and the maximum node count used by distributed training.
  • Data path: dataset size and object count, read and write throughput, file-system semantics, checkpoint frequency and size, tokenizer and vocabulary files, experiment metadata, cache locations, and retention rules.
  • Network and service dependencies: ingress and egress paths, private endpoints, DNS names, external APIs, database connections, queue topics, latency requirements, firewall rules, and allowed regions.
  • Identity and secrets: IAM roles, service accounts, workload identities, key-management integrations, secret rotation, certificate trust stores, and any credentials embedded in jobs or images.
  • Operational constraints: licensing, compliance and residency requirements, quota limits, maintenance windows, preemption behavior, recovery objectives, SLOs, alert routes, and on-call procedures.

Capture the current baseline while the source system is healthy: training steps per second, time to first token or inference request, p50 and p95 latency, GPU utilization, host and storage throughput, checkpoint duration, failure rate, and cost per completed training run or million inferences. These measurements become the acceptance criteria for the destination.

Make the runtime portable with an OCI container

Put application code, Python packages, operating-system dependencies, and pinned framework and CUDA user-space libraries in an OCI-compatible image. NVIDIA states that “The NVIDIA Container Toolkit allows users to build and run GPU-accelerated containers.” The container should carry the user-space stack; the destination platform should manage the host kernel and GPU driver.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Pin versions and verify the driver contract

Record the image digest, framework build, CUDA major and minor version, and every native library loaded by the process. The destination host driver must meet the minimum driver requirement for the CUDA version in the image. Google’s GPU guidance notes that applications need CUDA-X libraries in the image or node path and that the node driver must be compatible with the selected CUDA version.

Do not assume that two clouds exposing the same GPU model have identical driver defaults. Make driver compatibility a provisioning check, then run a smoke test that creates a CUDA context, enumerates every visible GPU, executes a matrix multiplication, and exercises the communication library used by distributed jobs.

Use a reproducible image and startup contract

A minimal image pattern is:

FROM nvidia/cuda:<pinned-runtime>-runtime-ubuntu<pinned-version>
WORKDIR /app
COPY requirements.lock ./
RUN pip install --require-hashes -r requirements.lock
COPY src/ ./src/
ENTRYPOINT ["python", "-m", "src.worker"]

Use your approved base-image registry and replace the angle-bracket values with real pinned versions. Build by digest, scan the image, and sign it if your supply-chain policy requires signing. Keep configuration outside the image so the same artifact can run in both clouds.

Test the image on the destination before moving production data

  1. Start a single destination GPU with the candidate image and the same environment variables used at the source.
  2. Run a CUDA visibility test and confirm that the expected GPU count and memory are reported.
  3. Restore a small real checkpoint, execute a fixed batch, and compare loss, logits, or generated output with the source within a predeclared tolerance.
  4. Run a multi-GPU communication test if the workload uses distributed data or tensor parallelism.
  5. Record startup time, image-pull time, GPU utilization, and storage-read throughput; a functionally correct image can still be operationally unsuitable.

Separate durable state from replaceable compute

GPU machines should be disposable. Store datasets, checkpoints, tokenizer files, feature artifacts, and experiment metadata in object storage or another portable data layer. Treat local NVMe or ephemeral GPU disks as caches that can be rebuilt, not as the only copy of state.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Define a storage manifest containing object key, size, version or generation, checksum, encryption status, and required permissions. Record which files are immutable and which are updated during training. This lets you transfer only changed objects and detect silent truncation or permission errors.

Design checkpoints for restart and rollback

  • Write checkpoints atomically to a temporary object or directory, then publish a completion marker only after all shards and metadata are present.
  • Include model, optimizer, scheduler, random-number-generator, tokenizer, and data-shard state when exact training continuation matters.
  • Keep at least one known-good checkpoint in the source environment until the destination has passed the acceptance window.
  • Document framework-specific serialization and endianness assumptions; a file that exists at the destination is not necessarily restorable there.

Recreate access, not just bytes

Copy bucket or container policies, object ownership, encryption-key permissions, lifecycle rules, and audit settings deliberately. Map source IAM roles to destination identities instead of copying long-lived access keys. Validate that a job can list, read, write, and delete only the objects its role is intended to access.

Select an equivalent or deliberately different destination GPU

Start with the workload’s requirements, then decide whether the destination should match the source or exploit a newer accelerator. Matching the model name alone is insufficient.

Comparison axis Questions to answer Migration consequence
Memory capacity Does each process fit, including optimizer states, activation checkpointing, and serving batches? A smaller card may require lower batch size, sharding, quantization, or a different parallelism plan.
Compute capability Are required kernels and data types supported, and does the framework build target the architecture? Unsupported kernels can cause runtime errors or force slow fallback implementations.
Interconnect Is high-bandwidth GPU-to-GPU or node-to-node communication available? Distributed training may scale poorly even when single-GPU throughput is higher.
Partitioning Are MIG or time-sharing options available and compatible with isolation requirements? Partitioning can right-size inference workers but changes visible memory and scheduling.
Region and quota Can the required GPU count be obtained in the permitted region, including during a scale-out event? A theoretically suitable SKU is not a practical option without quota and capacity.
Price model What are on-demand, reserved, committed-use, and spot or preemptible terms? Compare the probability-weighted cost of completed work, including interruption recovery.
Storage and network Can the platform sustain the required dataset and checkpoint throughput, and what are transfer charges? Low GPU utilization caused by I/O can erase an attractive compute price.

Measure cost per training step, successful epoch, model version, or million inferences. Do not compare hourly prices without including storage, inter-region transfer, egress, control-plane services, idle capacity, and engineering effort.

Provision the destination platform

Virtual machines

For a VM-based deployment, create a machine image or bootstrap script that installs the approved host driver, container runtime, monitoring agent, and only the node-level dependencies that cannot live in the container. Apply infrastructure as code so a replacement node is identical. Test reboot, driver upgrade, disk replacement, and loss of a worker before production cutover.

Kubernetes

Define GPU resource requests and limits, node selectors or affinity, taints and tolerations, topology constraints, autoscaling limits, and disruption budgets. Ensure the scheduler cannot place a job on a node with insufficient memory or the wrong accelerator generation. NVIDIA documents Kubernetes portability through GPU Operator and Cloud Native Stack; use a supported operator version and pin it alongside the cluster version.

Google Kubernetes Engine documents managed GPU node lifecycle, driver installation, and GPU allocation. Equivalent controls on another managed Kubernetes service may use different labels and lifecycle behavior, so keep provider-specific manifests in a thin overlay while the workload manifest remains common.

Scheduling and failure behavior

  • Set an explicit maximum for autoscaling so a retry storm cannot consume the entire quota.
  • Configure graceful checkpointing for preemption or node drain and test the actual termination notice available on the destination.
  • Export GPU temperature, memory use, utilization, ECC or hardware errors where available, job queue time, step time, and checkpoint age.
  • Alert on stalled data loaders and low GPU utilization; both can look like a healthy process while wasting capacity.

Transfer terabytes of data in phases

For large object sets, use a managed transfer service rather than a collection of ad-hoc copy scripts. Google says Storage Transfer Service is “optimized for transfers involving more than 1TiB of data.” Its documented sources include Amazon S3, Azure Blob Storage, Cloud Storage, on-premises systems, and file systems, with multiple egress paths and event-driven updates.

Phase 1: Initial bulk copy

  1. Freeze the source manifest and estimate object count, bytes, expected transfer duration, and egress charges.
  2. Copy immutable datasets first, then checkpoints and metadata. Keep source objects available while verification runs.
  3. Preserve object names, versions where required, content types, and encryption settings.
  4. Record transfer IDs, errors, retries, and the destination generation or version of every object.

Phase 2: Verify independently

Compare object counts and total bytes by prefix, then verify checksums or cryptographic hashes for every object when the storage systems expose compatible checksums. Spot-check decompression, shard readability, checkpoint restoration, and permission behavior. A successful transfer job is not proof that the training pipeline can consume the data.

Phase 3: Synchronize deltas

After the bulk copy, use scheduled or event-driven transfer for new and changed objects. Google documents event-driven transfers that can copy updates from AWS S3 or Azure Blob Storage after an initial batch, supporting a low-downtime pattern. Define a conflict rule for objects changed in both environments; do not rely on last-writer-wins for checkpoints unless that is explicitly acceptable.

Keep a cutover manifest timestamp. Immediately before switching traffic, stop or quiesce writers briefly, run one final delta transfer, verify the manifest, and record the exact source checkpoint and destination checkpoint that will be used.

Validate correctness, performance, and operations

Write pass/fail thresholds before testing. A useful validation matrix includes:

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
Test Method Example acceptance evidence
Checkpoint restore Restore a production-format checkpoint and run the same evaluation batch. All shards load; loss, logits, or generated output stays within the agreed numerical tolerance.
Training convergence Run a representative interval with the same data order or a controlled seed. Learning curves and validation metrics are statistically consistent with the baseline.
Throughput Measure steps per second, samples per second, and input pipeline utilization. Meets the target after warm-up, with no unexplained communication stalls.
Serving latency Replay representative requests at expected concurrency. p50, p95, and error-rate SLOs pass in the target region.
Scale and interruption Scale workers, drain a node, and simulate preemption if the pricing model allows it. Jobs resume from checkpoints within the recovery objective and do not corrupt state.
Observability Trigger a controlled failure and inspect logs, metrics, traces, and alerts. On-call staff can identify the failing component and receive the expected notification.
Security Attempt permitted and forbidden storage, network, and administrative actions. Least-privilege policies, encryption, audit records, and boundary controls behave as designed.

Use the same image digest, dataset slice, batch size, precision mode, and warm-up procedure when comparing providers. If the destination uses a different GPU architecture, document expected numerical variation and compare distributions or task metrics rather than demanding bit-for-bit identity.

Canary the workload and cut over safely

  1. Prepare rollback: keep the source deployment, image, credentials, routes, and last known-good checkpoints intact.
  2. Run a bounded canary: send a small percentage of requests or a fixed training batch to the destination. Compare output quality, latency, errors, GPU utilization, and cost.
  3. Increase gradually: expand traffic or worker count only after each observation interval meets the thresholds. Watch quota consumption and transfer lag.
  4. Freeze writes briefly: stop new source writes or place the application in a quiescent mode, complete the final delta transfer, and verify checksums and permissions.
  5. Switch the control plane: change the router, queue consumer, scheduler, or endpoint to the destination. Record the exact time, image digest, checkpoint, and configuration revision.
  6. Observe before decommissioning: retain source capacity and data for the defined acceptance window. Roll back traffic if correctness, SLOs, data integrity, or recovery behavior fails.

For long-running training, cut over at a checkpoint boundary rather than interrupting a write. For stateless inference, a weighted traffic shift usually permits a smaller blast radius, provided both versions receive comparable request distributions.

Compare total cost and operational burden

Build a monthly and per-work-unit model with the same workload assumptions. Include:

  • GPU and host charges for active, idle, reserved, committed, spot, or preemptible capacity.
  • Persistent disks, object storage, snapshots, backup copies, and metadata services.
  • Ingress and egress, cross-region or cross-zone transfer, and one-time migration traffic.
  • Managed Kubernetes, load balancing, observability, support, and security services.
  • Expected interruption cost, checkpoint overhead, retraining after failure, and engineering time.

Use a formula such as cost per completed training hour = (compute + storage + network + platform + recovery overhead) ÷ successful training hours. For inference, use cost per million successful requests at the target latency and availability. A lower nominal GPU rate is not cheaper if slower storage, scarce quota, or frequent preemption reduces completed work.

Security, compliance, and licensing checks

Confirm that the destination region satisfies residency and contractual requirements before copying data. Encrypt transfers in transit and objects at rest, use customer-managed keys where required, and ensure the destination identity can decrypt only the intended datasets. Recreate private networking, firewall rules, egress controls, vulnerability scanning, and audit retention.

Review licenses for frameworks, model weights, datasets, commercial CUDA-adjacent components, and support subscriptions. NVIDIA AI Enterprise is documented for AWS, Google Cloud, Microsoft Azure, Oracle Cloud Infrastructure, Alibaba Cloud, and Tencent Cloud; verify the entitlement, image source, and support terms for the destination you select rather than assuming a license follows an image automatically.

Use GPU partitioning when it matches the workload

NVIDIA Multi-Instance GPU (MIG) can divide a supported accelerator into isolated instances for smaller jobs. NVIDIA documents that “Each MIG instance behaves like a standalone GPU to applications, so there’s no change to the CUDA® platform.” This can help right-size inference or fine-tuning workloads when the destination offers MIG, but each instance has less memory and compute than the full card. Re-run capacity, latency, and noisy-neighbor tests with the selected profile; do not treat MIG as a drop-in replacement for a multi-GPU training node.

Common failure modes and recovery actions

Symptom Likely cause Action
Container starts but CUDA initialization fails. Host driver is older than the CUDA requirement, or the runtime cannot access the GPU device. Check the driver-to-CUDA compatibility, container runtime hooks, device permissions, and visible GPU list; rebuild only after confirming the required driver.
Single-GPU test passes but distributed training is slow. Different interconnect, topology, collective-library settings, or insufficient network bandwidth. Run a communication benchmark, inspect topology, pin compatible libraries, and reconsider GPU count or parallelism.
Jobs fail to find data after transfer. Object prefixes, region endpoints, IAM permissions, or encryption-key grants differ. Test list/read/decrypt with the workload identity and compare the manifest, not an administrator’s access.
Checkpoint appears present but cannot restore. Incomplete multi-part write, missing shard, incompatible serialization, or wrong framework version. Use atomic publication markers, verify every shard hash, restore in a disposable job, and retain the source checkpoint.
Destination is cheaper per hour but slower overall. Lower memory, slower storage, queue time, preemption, or data-transfer bottlenecks. Compare cost per successful unit of work and test a larger-memory GPU, faster storage, or different scheduling policy.
Autoscaling exhausts quota. New workers request a GPU SKU or region with insufficient quota. Set hard upper bounds, request quota before cutover, and define a fallback SKU or region if compliance permits.
Canary outputs differ unexpectedly. Precision mode, kernel implementation, tokenizer version, preprocessing, or checkpoint state changed. Compare image digest, inputs, seeds, precision, tokenizer files, and preprocessing artifacts before changing model code.

A practical migration runbook

  1. Write the business and technical success criteria, rollback deadline, and observation window.
  2. Inventory software, GPUs, topology, data, identities, APIs, quotas, regions, compliance, and licenses.
  3. Choose rehost, replatform, or refactor and document provider-specific assumptions.
  4. Build and sign a reproducible OCI image with pinned framework and CUDA user-space libraries.
  5. Provision a small destination environment and verify host-driver compatibility.
  6. Move a representative dataset and checkpoint; validate hashes, permissions, decryption, and restore.
  7. Provision production-shaped compute, storage, networking, scheduling, autoscaling, and observability.
  8. Run correctness, convergence, throughput, latency, interruption, security, and cost tests against predefined thresholds.
  9. Perform the initial bulk transfer, then maintain scheduled or event-driven delta synchronization.
  10. Canary traffic or a bounded training batch, increase gradually, freeze writes, transfer the final delta, and switch.
  11. Monitor the acceptance window, keep the source rollback path, and decommission only after the window closes.
