How to Keep Sensitive Data Out of On-Device AI Context

Running an AI model on a phone or computer can reduce the amount of information sent to a provider, but it does not automatically keep private data out of the model’s context. The reliable approach is to minimize inputs before inference, keep sensitive collections outside the context window, grant narrow permissions and tools, treat files and web content as untrusted, validate every model-generated action in application code, and require human approval for consequential changes.

What “keeping data out of context” actually means

An AI model’s context is the material it can use for one response: instructions, conversation history, retrieved records, images, documents, tool results and other inputs supplied by the application. If a local model can see a value, that value is part of the model’s working context regardless of whether inference happens on a phone, laptop or server.

Keeping sensitive data out of context therefore means more than choosing an on-device model. It means designing the surrounding application so the model receives only the smallest, least identifying representation needed for the task. A feature that runs offline but automatically inserts a complete address book, private folder or customer database into every prompt has still exposed that information to the model and to any workflow that can use its output.

Apple describes on-device models as keeping information on the device, responding quickly and working offline. That is a useful privacy boundary against unnecessary server processing, but it is not a guarantee that an app will avoid collecting, displaying or acting on sensitive information. The app decides what enters context and what permissions the AI feature receives.

Why local inference is helpful but not sufficient

Local execution can prevent a particular request from being sent to a remote model service. It can also make offline operation possible and reduce dependence on a network connection. Apple’s developer guidance nevertheless distinguishes between on-device processing and situations where server processing may be appropriate for greater processing power or a larger context. The choice is an architecture decision, not a complete security decision.

Privacy exposure can occur at several points in the data path:

Control point What can go wrong Safer design
Input selection The app adds names, locations, photos, documents or proprietary records that the task does not require. Choose fields deliberately and remove or transform unnecessary details before inference.
Context assembly A whole collection is copied into a prompt because it is convenient to provide broad access. Keep the collection outside context and expose a narrow, app-controlled lookup.
Permissions and tools The model can reach broad file, database, network or messaging capabilities. Grant only the permissions and single-purpose tools required for the stated feature.
Retrieved material A webpage, file or user submission contains instructions that attempt to redirect the model. Mark external material as untrusted, separate it from trusted instructions and validate proposed actions.
Output handling Generated text or tool arguments contain secrets, personal identifiers or an unauthorized action. Filter outputs, validate arguments in ordinary application code and require confirmation for high-impact actions.

This layered view matters because a restrictive system prompt is only an instruction to the model. Permissions, tool constraints, validation, filtering and user confirmation are controls enforced by the application and are therefore stronger security boundaries.

Start with a data map before adding any prompt

For each feature, write down the task, the exact output required and every data field the model might receive. Treat each field as a design choice rather than an automatic input.

Ask whether the original value is necessary

  • Does the model need a person’s name, or only a role such as “customer” or “manager”?
  • Does it need an exact location, or only a city, region or distance band?
  • Does it need a full document, or only selected passages or a structured summary?
  • Does it need a raw image, or can the app provide a description with identifying details removed?
  • Does it need a complete record, or only the one value relevant to the current request?

If a derived value produces the same useful answer, use the derived value. Android guidance explicitly recommends sanitization, anonymization and data minimization before inference. Removing an identifier is preferable to asking the model to ignore it after it has already been supplied.

Classify fields by sensitivity and necessity

A practical review labels each field as required, optional or prohibited for the task. Required fields are the minimum inputs without which the feature cannot work. Optional fields may improve wording but are not necessary. Prohibited fields should never enter the model context for that feature, even if the app technically has access to them.

Keep this decision in code and in the feature specification. A later interface change should not silently expand the prompt to include every field returned by a database query or file picker.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Use redaction, anonymization and derived representations

Sanitization should happen before the model receives the data. Depending on the task, that may mean removing direct identifiers, replacing them with stable labels, generalizing precise values or converting free text into a limited schema.

Redaction

Delete details that have no bearing on the requested result. A summarizer that only needs deadlines does not need personal phone numbers embedded in the same notes. A classifier that identifies a document type may not need account numbers or signatures.

Pseudonyms and stable labels

When the model must refer to multiple people or records consistently, replace names with labels such as PERSON_1 and PROJECT_A. Keep the mapping in application-controlled storage rather than placing the original values alongside the labels in context. The model can then produce a useful structured result without seeing the real identities.

Generalization

Reduce precision when precision is not part of the task. A broad age band, region or time window can support categorization while revealing less than an exact birth date, address or timestamp.

Structured extraction

Instead of passing an entire record, extract only the fields the model must reason about. For example, provide a deadline, status and priority while keeping billing details and internal identifiers outside the context. Validate the extracted structure before it is sent to the model; otherwise malformed or unexpected content can reintroduce sensitive fields.

Keep sensitive collections outside the context window

Do not load a full contact list, database table, document repository or photo library into a prompt merely because the app can access it. Give the model a narrow operation that returns the specific authorized result needed for the current task.

Prefer constrained retrieval

Android guidance uses the example of a constrained contact lookup rather than exposing the entire contact list. In that design, the app receives a user request, checks what the request is allowed to retrieve, performs the lookup itself and returns only the necessary result. The model never receives unrelated contacts.

A safe retrieval function should define:

  • The collection it can query.
  • The fields it may return.
  • The maximum number of results.
  • The user or account whose authorization applies.
  • The input format and validation rules.
  • Whether returned material is trusted application data or untrusted external content.

Do not let the model write arbitrary queries

Expose a purpose-built operation such as “find the authorized contact matching this supplied name,” not a general database console. The application should construct and execute the query after validating parameters. This prevents a prompt from turning a narrow feature into a mechanism for dumping unrelated records.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Return the minimum useful result

If the model needs to decide whether a meeting can be scheduled, it may need availability windows but not every calendar event title. If it needs to draft a reply, it may need a selected message but not the entire mailbox. Narrow results reduce both accidental disclosure and the amount of untrusted material the model must interpret.

Scope permissions and tools by feature

Least privilege applies to AI features just as it does to other software. Give the component only the Android permissions, app tools and data sources needed for its stated purpose. Avoid broad file, database, network or messaging access when the feature does not require it.

Make tools single-purpose

A tool should perform one clearly defined operation with a limited argument set. “Create a draft email to this approved recipient” is safer than a general messaging tool that can select recipients, attach arbitrary files and send immediately. “Read the next appointment” is safer than unrestricted calendar export.

Validate every argument outside the model

Model-generated arguments are untrusted input. Ordinary application code should check types, ranges, ownership, destination, authorization and any business rules before a tool executes. A tool call that fails validation should stop or return a safe error; it should not be repaired by allowing the model to try arbitrary alternatives.

Tie actions to the user’s request

Keep a clear relationship between the user’s initiating action and the tool operation. A document that tells the model to send a message should not be able to create that authority. The application should require an appropriate user request and authorization for the action itself.

Separate trusted instructions from untrusted content

Webpages, files and user submissions can contain indirect prompt injections: text that looks like an instruction and attempts to make the model reveal data, ignore rules or call a tool. Apple warns that using unverified input in instructions makes an app vulnerable to prompt injection. Android guidance likewise recommends marking externally sourced content as untrusted.

Keep external text in a data field

Do not concatenate a webpage or document into the trusted system instruction. Place it in a distinct input section or data structure and tell the model to analyze it rather than obey it. Clear delimiters help the model distinguish roles, but delimiters are not an access-control mechanism.

Use an explicit trust boundary

A robust request separates at least three categories:

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
  • Trusted instructions: the fixed behavior defined by the application.
  • User request: the action the user has actually asked the feature to perform.
  • Untrusted content: text, files, webpages or records that the model should inspect, summarize or classify.

Tell the model that instructions found inside untrusted content are data, not authority. Then enforce that distinction in application code by refusing unauthorized tool calls even if the model produces them.

Assume untrusted content can be persuasive

Prompt injection does not have to use a special keyword. A document can contain ordinary-looking directions such as a request to disclose hidden text or forward a file. The correct response is not to search for one pattern and declare the input safe. Keep sensitive data and powerful tools out of reach, validate outputs and require confirmation for consequential actions.

Protect outputs as carefully as inputs

Data can leak in a response even when the initial prompt was minimized. Scan or redact model output for secrets and personal identifiers when the feature’s risk warrants it. Apply the check before displaying, storing or sending the response.

Validate generated tool calls

Treat a proposed recipient, file path, setting change, deletion target or query parameter as untrusted. Check that it is authorized, within the user’s scope and consistent with the feature’s purpose. Do not infer authorization from the fact that the model produced the argument.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Require confirmation for consequential actions

Ask the user to approve actions such as sending messages, changing settings, deleting information or making other irreversible changes. Show the actual target and material effect, not just a generic “continue” button. A confirmation step is especially important when a webpage, file or retrieved record influenced the proposal.

Keep drafts separate from execution

Where possible, have the model prepare a draft or preview and let the application present it for review. Execution should be a separate, authorized step. This limits the damage from an incorrect interpretation or an injection that persuades the model to propose an action.

Make data use understandable to people

Users need to know what an AI feature does with their information. Apple’s guidance recommends explaining what data is sent to a model, whether processing is server-based, what may be stored or used for training and how a user can opt out where applicable. It also recommends obtaining permission before using personal information.

Present this information at the point of use, not only in a long privacy policy. A useful disclosure answers:

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
  • Which categories of data the feature reads.
  • Which categories are sent to an on-device model and which, if any, leave the device.
  • Whether the feature stores prompts, outputs or retrieved records.
  • Whether information may be used for training under the service’s terms.
  • Which permissions can be withdrawn and what functionality will stop when they are removed.

Do not describe a feature as “private” solely because inference is local. State the actual boundary: for example, that model inference occurs on the device while the app may still access selected records or use a server for other operations.

Compare architectures by exposure, not labels

The right design depends on the task, the required context and the consequences of a mistake. The following comparisons capture the trade-offs identified in platform guidance.

Architecture choice Privacy and capability trade-off Design question
On-device inference Information can remain on the device, responses can be quick and offline use is possible; device resources and context capacity may be limited. Can the local model complete the task with minimized data and available hardware?
Server processing May provide more processing power or a larger context, but information may leave the device and requires clear disclosure and authorization. Is the additional capability worth the additional data path?
Broad context Can simplify prompting, but exposes more records and increases the effect of an accidental or malicious instruction. What exact fields are necessary, and what can be retrieved on demand instead?
Task-scoped retrieval Returns less data and supports least privilege, but requires explicit retrieval logic and authorization checks. Can the app answer the model’s question with one constrained operation?
Prompt-only guardrails Can guide behavior but cannot reliably enforce permissions or authorization. Which controls are implemented outside the model?
App-enforced controls Permissions, validation, filtering and confirmation create enforceable boundaries, though they require engineering effort. Does every sensitive operation fail closed when validation or authorization fails?

There is no universal rule that local inference is always preferable. A local model that receives an entire private archive may expose more information within the application than a carefully designed remote workflow that sends only a redacted excerpt. Compare the complete data path, not just where the model weights run.

A practical implementation sequence

1. Define the task and acceptable output

Write the feature’s purpose in one sentence and specify what a successful answer contains. This prevents “helpful” context from expanding beyond the task.

2. Build the minimum input schema

List the fields required for that output. Mark fields that are optional or prohibited. Reject unexpected fields before prompt construction.

3. Sanitize before inference

Redact identifiers, generalize precise values and replace names with labels where the original values are unnecessary. Perform this transformation before the data reaches the model.

4. Move collections behind constrained operations

Keep contacts, files, messages and databases outside context. Implement a narrow lookup that returns only the authorized result and fields.

5. Scope permissions and tools

Grant only the platform permissions and app tools the feature needs. Make each tool single-purpose and define accepted arguments.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

6. Mark external material as untrusted

Store webpage, file and user-submitted text in a separate data section. Instruct the model to analyze it, not follow instructions inside it.

7. Validate outputs and tool arguments

Check generated text for sensitive values where appropriate. Validate every proposed action in application code, including target, scope, authorization and reversibility.

8. Add human approval

Show the exact action before sending a message, changing a setting, deleting information or performing another consequential operation. Require an explicit confirmation.

9. Explain the data path

Tell users what is read, where processing occurs, what may be stored and how permissions or opt-outs work.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

10. Audit and red-team the complete workflow

Review inputs, context assembly, retrieval, permissions, tools, outputs and storage. Test malicious files and webpages, unexpected tool arguments and attempts to retrieve data outside the user’s authorization. Android guidance recommends regular auditing and red teaming for leakage risks.

Common failure modes and fixes

“It is local, so we can include everything”

Failure: The app copies a full private collection into a local prompt.

Fix: Minimize first and use a constrained lookup. Local execution reduces server-side exposure but does not make unnecessary context appropriate.

“The system prompt says not to reveal secrets”

Failure: Sensitive data and powerful tools remain available while the design relies on an instruction to behave safely.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Fix: Remove unnecessary data, enforce permissions in code, validate outputs and require confirmation. Treat prompts as guidance, not the security boundary.

“We pasted the document into the instructions”

Failure: Unverified document text can impersonate trusted instructions and trigger prompt injection.

Fix: Keep the document in a separate untrusted field, direct the model to analyze it and block unauthorized tool calls in application code.

“The model can query the database if needed”

Failure: A general query capability can expose records unrelated to the request.

Pick the symptom - the matching free tool is one click away.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Fix: Replace it with a single-purpose operation with fixed fields, limits and authorization checks.

“A preview is enough protection”

Failure: The application executes a generated action without verifying its target or requiring meaningful approval.

Fix: Validate arguments independently and require explicit confirmation for sending, deletion, settings changes and other consequential operations.

“We disclosed that the model is on-device”

Failure: Users are left unaware of other processing, storage or training uses.

Fix: Explain the entire data path, including any server processing, retention, training use and opt-out controls.

How to review an existing on-device AI feature

Use this checklist during a code, design or privacy review:

  • Can you enumerate every field that enters the model context?
  • For each field, is the original value necessary for the stated task?
  • Are identifiers, precise locations, private documents and proprietary details removed when they do not affect the result?
  • Does the model receive a whole collection, or only the result of a constrained authorized lookup?
  • Are permissions limited to the feature’s purpose?
  • Are tools single-purpose, parameterized and validated outside the model?
  • Are webpages, files and user submissions isolated from trusted instructions?
  • Can untrusted content cause a tool call or change the user’s authorization?
  • Are outputs checked for secrets and personal identifiers before display or storage?
  • Do consequential actions require a clear user confirmation?
  • Does the user-facing explanation cover on-device and server processing, storage, training use and opt-out options?
  • Have you tested malicious instructions in documents and webpages, unauthorized lookups and unexpected model arguments?

The bottom line for on-device AI privacy

On-device inference is a valuable privacy measure because it can keep processing on the device and support offline use. It is not permission to place every accessible record into context. The durable design is layered: minimize and sanitize inputs, keep sensitive collections outside the context window, expose narrow authorized tools, separate untrusted content from trusted instructions, validate outputs in application code, and put a person in control of consequential actions. That combination limits what the model can see and what the surrounding workflow can do, even when a prompt is manipulated or a model makes a mistake.
