Map every prompt, retrieved record, model input, output, log, cache, backup, replication stream, and downstream transfer. Classify each data type, allow only approved routes and identities, encrypt storage and movement, constrain locations and administrator access, and continuously monitor use. This approach works whether a workload runs on premises, in a private cloud, or through a public AI service.
No single product or deployment model solves hybrid-cloud AI governance. The controls must follow the data flows and the obligations attached to each data class.

What “control” means for hybrid-cloud AI
An AI application can create more copies of sensitive information than a conventional line-of-business application. A user prompt may be copied into an API gateway log, sent to a retrieval service, embedded in a vector store, combined with documents, submitted to a model endpoint, returned as an output, retained in an evaluation dataset, and backed up several times. A support engineer or service administrator may also be able to view one of those copies.
NIST Internal Report 8505, published September 30, 2024, treats classification and protection as data moves through cloud-native, multicloud, and hybrid architectures. Its implication for AI governance is practical: inventory the path and its copies, not just the system of record.

The complete AI data path
| Stage | What to inventory | Questions to answer |
|---|---|---|
| Collection | User prompts, uploaded files, images, audio, telemetry | Who can submit data, from which devices, and under what class? |
| Gateway | API gateway, safety filter, prompt template, request log | Are payloads logged, redacted, sampled, or replayable? |
| Retrieval | Document store, vector database, embeddings, search indexes | Can a user retrieve a record they are not entitled to see? |
| Model execution | On-premises model, hosted endpoint, agent, plugin | Where is processing performed, and who administers it? |
| Output handling | Responses, generated files, tool calls, downstream systems | Are outputs classified, reviewed, and retained like source data? |
| Observability | Traces, metrics, debugging captures, evaluation sets | Do monitoring systems copy prompts or retrieved passages? |
| Protection copies | Snapshots, replicas, caches, backups, disaster-recovery sites | Do copies inherit location, encryption, access, and deletion rules? |
| Transfers | Service-to-service calls, migrations, exports, support access | Is the destination approved and is the transfer authenticated? |
Assign an owner, data class, location, transfer route, and retention rule to every row. Include service-to-service traffic and temporary copies made for debugging or model evaluation.
Classify data before choosing an AI route
Classification turns a general privacy objective into an enforceable routing decision. Your categories may differ by sector, but a useful scheme distinguishes public information, internal business data, confidential data, regulated personal information, and highly restricted material such as credentials, cryptographic keys, or protected health records.
Build a handling matrix
| Data class | Permitted processing | Minimum controls |
|---|---|---|
| Public | Approved hosted or internal models | Integrity checks and ordinary access logging |
| Internal | Approved endpoints with business-purpose access | Identity-based authorization, encryption, and defined retention |
| Confidential | Only endpoints reviewed for contract, location, and administrator access | Least privilege, redaction where possible, strong key management, detailed audit |
| Regulated | Routes that satisfy applicable law, sector rules, and contracts | Documented purpose, approved geography, restricted operators, monitored access, deletion procedure |
| Highly restricted | Usually a dedicated or tightly isolated environment unless a specific exception is approved | Explicit authorization, hardened identities, end-to-end encryption, controlled keys, continuous review |
The matrix should state which classes may be sent to each model endpoint, from which locations, and by which application or business role. Enforce it before a prompt leaves the user interface; a policy applied only after a third-party endpoint receives the data is too late.
Minimize before prompting
- Remove fields that are not needed for the task.
- Replace names, account numbers, or identifiers with stable tokens when the model does not need the originals.
- Filter retrieved documents to the smallest authorized set.
- Prevent secrets, access tokens, and private keys from entering prompts.
- Classify outputs before forwarding them to email, ticketing, analytics, or another agent.
Keep a record of whether an endpoint is internal, cloud-hosted, or operated by a third party. Confirm contractual handling for prompts, outputs, logs, training use, support access, and deletion. There is no universal retention period and no universal rule that all sensitive data must remain on premises; the correct decision depends on jurisdiction, sector, contract, and the specific service.
Enforce identity and workload boundaries
Apply least privilege to people, service identities, administrators, and workloads. NIST Special Publication 800-210, published July 31, 2020, explains that access-control requirements differ among infrastructure as a service (IaaS), platform as a service (PaaS), and software as a service (SaaS). NIST Special Publication 1800-35, published June 2025, provides zero-trust implementation guidance for distributed on-premises and cloud resources and reports 19 example implementations. That count describes examples in the guide, not measured security outcomes.

Separate the identities
- Use a central identity provider and phishing-resistant multifactor authentication for human users.
- Give the model gateway, retrieval service, vector store, evaluation pipeline, and deployment system separate service identities.
- Use narrowly scoped roles that allow a component to read only the collections and fields it needs.
- Prefer short-lived credentials, workload identity, and automatic rotation over long-lived keys in configuration files.
- Separate application operators from security auditors and key administrators.
- Review provider, platform, and database administrator permissions; an application policy does not prevent a privileged operator from accessing the underlying data.
A FIDO2-compatible hardware security key can strengthen the authentication step for administrators and other high-risk users. Verify compatibility with your identity provider, operating systems, browsers, and recovery process. A security key authenticates a person; it does not discover sensitive data, encrypt AI traffic, set residency, or determine provider retention.
Apply controls at each service layer
| Layer | Typical AI components | Control questions |
|---|---|---|
| IaaS | Virtual machines, networks, disks, snapshots | Who can alter networks, attach a disk, copy a snapshot, or access the host-management plane? |
| PaaS | Managed databases, queues, search, model platforms | Which roles can query data, change a policy, export records, or enable diagnostic logging? |
| SaaS | Hosted copilots, document assistants, external APIs | What are the provider’s processing, logging, retention, deletion, support, and subprocessor terms? |
Use the same policy vocabulary across layers, but do not assume one role model maps cleanly between them. Test both human and workload authorization with allow and deny cases.

Encrypt storage, transfers, and workload movement
Encrypt sensitive data at rest in databases, object stores, vector indexes, caches, snapshots, and backups. Encrypt in transit between users, gateways, retrieval systems, model endpoints, and downstream tools. NIST Special Publication 1800-19, published April 20, 2022, describes encryption at rest and end-to-end encryption with mutual authentication for workload movement in a VMware hybrid-IaaS scenario. Use that as an implementation example, not as a universal architecture.
Protect keys independently
- Keep encryption keys under a separately governed key-management service or hardware security module where feasible.
- Separate key administrators from storage administrators.
- Define rotation, revocation, escrow, and emergency-access procedures.
- Test that revoking a key actually blocks access to the intended data without destroying required recovery copies.
- Record which key protects each database, index, log archive, snapshot, and backup set.
For sensitive transfers, authenticate both ends rather than relying solely on network location. Mutual TLS, workload identity, and certificate rotation can establish that the sender and receiver are approved services. Treat model migration, replication, failover, and bulk export as control points; a protected production database can still be exposed during an unencrypted copy operation.
Constrain geography, residency, and provider administration
Location controls should cover execution, storage, backups, replicas, support operations, and disaster recovery. NIST Special Publication 1800-19 discusses running workloads in an authorized geolocation or logical boundary and preventing provider administrators from accessing sensitive applications and drives in its hybrid VMware IaaS scenario. That 2022 guide addresses a specific implementation; adapt the pattern to your architecture and legal requirements.

Turn location into an enforceable rule
- List allowed countries, regions, facilities, network zones, and logical boundaries for each data class.
- Check that model execution, retrieval stores, logs, snapshots, and backups support those boundaries.
- Block or alert on deployment, replication, scaling, or failover into an unapproved location.
- Ask the provider where support personnel, subprocessors, and maintenance systems can access data.
- Document exceptions with an owner, business reason, compensating controls, and expiry date.
Do not equate “private cloud” with automatic residency or “public cloud” with automatic loss of control. A private environment may still have broad administrator access or poorly governed backups, while a hosted service may offer strong isolation and contractual restrictions. Verify the actual control plane and operating procedures.

Log access to sensitive stores and monitor unusual volume, destinations, times, and principals. NIST Special Publication 1800-19 describes scanning filesystems for sensitive data, categorizing discovered files, monitoring access, and reporting on it. Apply the same idea to document stores, vector indexes, prompt archives, and output repositories.
Design useful audit records
- Record the identity, workload, data asset, action, decision, time, location, and request correlation ID.
- Prefer hashes, classifications, field names, or redacted excerpts over full prompt contents in routine logs.
- Protect audit records from alteration and restrict who can search them.
- Set a separate retention schedule for security telemetry; monitoring data can itself be sensitive.
- Alert on bulk retrieval, repeated authorization failures, unusual exports, access from a new geography, and a service identity calling an unexpected destination.
Keep enough evidence to investigate an incident while minimizing replicated content. A trace that stores every retrieved paragraph may become a second high-value data store.
Review the AI provider’s data lifecycle
For every hosted model, API, plugin, agent tool, and evaluation service, document what happens from receipt to deletion. Ask for current contractual and technical answers, not only marketing descriptions.
Questions to put in the provider review
- Are prompts and outputs used for training, abuse detection, quality review, or product improvement?
- Which request, response, diagnostic, and safety logs are created, and how long are they retained?
- Can the customer disable content logging or set a retention period?
- Where are processing, storage, backups, and support operations located?
- Which employees, subprocessors, or support systems can access content?
- How are deletion requests propagated to indexes, caches, replicas, backups, and evaluation datasets?
- What happens when an account is suspended, a plan changes, or a service is discontinued?
- Can the service export audit records without exporting sensitive content?
AWS Prescriptive Guidance discusses lifecycle, encryption, access controls, and secure pipelines for generative-AI applications. It is vendor-specific guidance and does not establish the practices of other providers. Recheck its revision and the chosen provider’s current terms before approving a service. Product tiers may have materially different logging, retention, training-use, and regional behavior.

A practical implementation sequence
Use the following sequence for a new system or a remediation project. Keep evidence for each decision so reviewers can see who approved a route and why.
- Draw the data path. Start with the user interface and trace prompts through gateways, retrieval, model execution, output handling, observability, backups, and downstream systems. Mark every transfer and copy.
- Assign classification and ownership. Label each asset and field, name the business owner and technical owner, and record the applicable legal, contractual, and retention obligations.
- Define allowed use. Create an endpoint matrix that states which classes may be sent to which model, from which locations, by which identities, and for which purposes. Add redaction and minimization rules.
- Configure identity boundaries. Integrate centralized authentication, multifactor controls, workload identities, least-privilege roles, administrator separation, and credential rotation. Test denied requests.
- Enable cryptographic protection. Encrypt stores, indexes, logs, backups, and transfers. Configure mutual authentication for sensitive service-to-service paths and maintain an independent key inventory.
- Set location and provider constraints. Apply approved geographies and logical zones, verify failover behavior, and document provider-administrator and subprocessor access.
- Turn on monitoring and discovery. Scan stores for sensitive content, categorize findings, log access, protect audit records, and alert on anomalous retrieval or export. Redact telemetry where full content is unnecessary.
- Test the exception paths. Exercise key rotation, provider outage, backup restoration, deletion requests, incident response, model replacement, denied access, and a new plugin or agent tool. Record each exception’s owner and expiry.
Compare deployment options by control, not reputation
When choosing where a component should run, score the alternatives against the same criteria. The right answer may be a split architecture: highly restricted retrieval on premises, a redacted prompt sent to a hosted model, and outputs returned through a controlled gateway.
| Decision axis | Questions to compare |
|---|---|
| Permitted data classes | Can the option handle the classes the application actually needs, or only minimized and redacted data? |
| Administration | Who can administer the application, host, storage, keys, logs, and support channel? |
| Location and residency | Can execution, storage, backups, failover, and support be restricted to approved boundaries? |
| Policy integration | Can enterprise identity, authorization, classification, and approval workflows be enforced consistently? |
| Encryption and key custody | Who controls keys, rotation, recovery, and revocation? |
| Logging and deletion | What is logged, for how long, who can view it, and how are copies deleted? |
| Isolation | How are networks, tenants, workloads, tools, and data stores separated? |
| Operations | What are the latency, availability, recovery, staffing, patching, and failure-mode trade-offs? |
Document the score and the residual risk rather than declaring one model universally secure. A hosted endpoint may reduce infrastructure maintenance but increase dependency on contractual and provider controls. An on-premises model may simplify residency decisions but require more capacity, patching, monitoring, and recovery engineering.
Failure modes to test before production
A prompt appears in a debug log
Disable payload logging where it is not required, redact fields at the gateway, restrict trace access, and purge existing captures according to the approved deletion procedure. Confirm that the observability vendor and backup system do not retain another copy.
A replica lands in the wrong region
Block the replication policy, identify affected copies, rotate credentials if access was possible, and follow legal and incident-response procedures. Correct the failover and scaling rules before restoring service.

Governance that survives change
AI systems change frequently: a new model endpoint, retrieval source, plugin, agent tool, observability package, or failover design can alter the data path. Require a lightweight review whenever one is introduced. The review should update the path diagram, classification matrix, identities, locations, provider terms, logging behavior, and tests.
Use an exception register with a named owner, justification, compensating controls, review date, and automatic expiry. Reassess high-risk exceptions after incidents, contract changes, model upgrades, or changes in applicable law.
The durable control objective is straightforward: know where sensitive AI data goes, permit only justified flows, protect every copy and transfer, restrict who and what can access it, and retain evidence that the controls work. Hybrid cloud can meet that objective, but only when governance follows the data rather than stopping at a storage boundary.
