It is a decision-specific readiness process: define the decision the system will support, map how records move through legacy systems, measure defects that could change that decision, correct the highest-impact causes, test the complete workflow with real users, and monitor it after launch.
Start with the decision, not the database
Data is fit or unfit for a particular use. The same customer, inventory or employee record may be adequate for a monthly report but unsafe for an automated eligibility recommendation. Before choosing a data-cleaning tool or writing transformation rules, describe the proposed AI use in operational terms.

- Input: What record, event or document arrives, from which system, and at what point in the process?
- Output: Will the system classify, rank, predict, summarize, extract or generate a recommendation?
- Decision maker: Which employee, customer-facing process or downstream application acts on the output?
- Failure consequence: What happens if the output is wrong, late, unavailable or confidently misleading?
- Operating context: Which geography, business unit, customer population, language, product line and regulatory setting are in scope?
Write acceptance criteria before examining the data. For example, an illustrative service-ticket triage use might require every ticket to retain its original identifier, a visible confidence or uncertainty state, a manual route for unknown categories and a way to recover when the source feed is delayed. Those are workflow requirements, not generic cleanliness scores.
The National Institute of Standards and Technology (NIST) AI Risk Management Framework (AI RMF) 1.0, released January 26, 2023, organizes risk work around context and impacts rather than a context-free declaration that data is “good.” The framework is voluntary, and its overview says a revision is in progress; verify the current status for your publication or deployment date.

Bring the right people into the definition
Include someone who knows the legacy process, data engineering or integration staff, the proposed AI developer, an evaluation specialist, privacy and security representatives, governance or compliance staff, and people who will use or be affected by the output. NIST describes AI work as involving multiple roles across the lifecycle. A technically clean table can still encode a business rule that frontline staff no longer use.
Map the complete data path
Legacy data rarely lives in one neat dataset. Create a source-to-decision map that follows records through the entire proposed use.
- Inventory sources. List databases, flat files, spreadsheets, scanned documents, message queues, vendor feeds and manual forms that contribute inputs or labels.
- Assign owners. Record the business owner, technical custodian, access approver and person responsible for correcting a defect in each source.
- Describe definitions. Document what each field means, valid units, code lists, identifiers, time zones, date semantics and whether a blank means “unknown,” “not applicable” or “not collected.”
- Record collection context. Note when and why information was captured, which populations were excluded, how staff entered it and whether practices changed over time.
- Trace transformations. Capture joins, filters, deduplication, imputation, aggregation, label creation, exports and handoffs. Preserve the original value alongside any transformed value when feasible.
- Document cadence and gaps. State how often each source updates, the expected delivery window, known outages and what the proposed system does when a feed is late or absent.
NIST identifies gathering and cleaning data and documenting metadata and dataset characteristics as design activities. In a legacy environment, the map itself is often a major deliverable because undocumented transformations can be the reason two departments report different values for the same customer or transaction.
Make lineage visible to reviewers
For every input used by the AI system, a reviewer should be able to answer: where did this value originate, when was it last changed, which rule changed it, and who approved that rule? Keep a versioned data dictionary and transformation log. If a downstream copy is patched manually, record the exception and trace the underlying source rather than allowing the patch to become an unexplained permanent truth.
Profile defects that can change the target outcome
Profile the data in the context of the stated decision. The following checks are practical techniques, not a universal NIST checklist or a set of official thresholds.

Missing and ambiguous values
Measure missingness by field, source, time period, business unit and relevant population. Investigate whether missing values cluster in the cases the AI system will handle. Distinguish a true zero from a blank and an unknown value from a value that was never requested. Decide, before training or inference, whether each condition should be imputed, routed for review, excluded or shown to the user.
Inconsistent definitions and units
Compare code lists and definitions across systems. A status such as “closed” may mean a resolved case in one application and an administratively archived case in another. Convert units only with documented rules, retain the original unit where possible and test boundary conversions, rounding and time-zone changes.
Do these 3 things before closing this tab:
1Clear out junk files and repair common Windows errors2Fix the driver behind crashes, sound loss and screen glitches3Repair Windows errors before they cause bigger problemsInvalid ranges and malformed records
Check dates, numeric ranges, identifiers, character encodings and required relationships. A date that parses successfully can still be impossible in the business context, such as a completion date preceding an intake date. Route invalid records to an exception process with the original value preserved; silently coercing them can hide a source-system defect.
Duplicates and identity errors
Look for repeated transactions, multiple customer identifiers, reused account numbers and collisions caused by truncated keys. Define which entity and event should be unique. Test matching rules against known merges and non-matches, and require a human review path for ambiguous identity links.
Staleness and temporal leakage
Record the age of each field at the moment the AI decision would be made. A value can be complete but too old for the use. For predictive tasks, ensure that features do not include information that became available only after the decision or outcome; otherwise evaluation can look strong while the live workflow fails.

Representativeness and coverage
Compare the records and labels with the users, cases and operating conditions in scope. Identify periods, locations, languages, product variants or customer groups that are absent or under-recorded. If the proposed use is limited to a population that the data does not represent, narrow the deployment, collect better examples or require human handling outside the supported scope.

Lineage and reproducibility
Re-run the profiling process from a known extract and retain the query, code or configuration used. A result that cannot be reproduced cannot support a reliable release decision.
Prioritize remediation instead of cleaning everything
Rank defects by their effect on the target decision, privacy or security exposure, remediation effort and ability to verify the correction. Do not create a single “data quality score” and present it as a certification. NIST’s guidance supports context-driven measurement, but it does not establish universal quality thresholds.
| Priority question | High-priority signal | Practical response |
|---|---|---|
| Could this defect change a consequential output? | The field drives routing, eligibility, pricing, safety or another material action. | Correct at the source or block automated use until an exception path is tested. |
| Could it expose people or violate permitted use? | Unnecessary personal data, unrestricted access or unclear retention. | Minimize, restrict, redact or remove the field; obtain governance approval. |
| Can the correction be verified? | A business owner and independent check exist. | Define a test and record the approving owner. |
| Is the defect cheap but irrelevant? | Formatting variation with no effect on the intended decision. | Defer it rather than delaying the deployment for cosmetic consistency. |
Fix the upstream cause when possible. If a nightly export drops a leading zero from account identifiers, changing the AI pipeline may make one release appear correct while every later export recreates the defect. A temporary downstream rule should have an owner, an expiry or review date and a test that detects when the source is repaired.
Set ownership, privacy and retention controls
Readiness includes who may use the data, for what purpose and for how long. The NIST AI RMF’s Govern function is intended to organize accountability and risk processes across the lifecycle. The framework is voluntary and does not replace applicable privacy, employment, financial, health, records-management or sector requirements.

- Assign approval for definitions, access, transformations, exceptions and remediation.
- Document the permitted purpose and any restrictions on secondary use.
- Limit access to the fields and environments required for the use; separate development, testing and production permissions.
- Set retention and deletion rules for source records, training or evaluation extracts, prompts, generated outputs, logs and backups.
- Record third-party dependencies, transfer locations, subprocessors and incident-escalation routes that apply to the deployment.
- Define how a person can challenge, correct or obtain human review of an AI-assisted outcome where applicable.
NIST’s Generative AI Profile, published July 26, 2024, specifically identifies data protection and retention among relevant considerations, along with monitoring and other controls. Applicability depends on the system and the data; a generative use does not remove the need to assess the underlying legacy records.
Choose a remediation pattern that fits the legacy stack
There is no universally best cleanup architecture. Compare options against the actual sources and decision rather than buying a generic “AI-ready” label.
| Approach | When it fits | Risks to test |
|---|---|---|
| Correct the source system | The business definition is stable and the system owner can change validation, codes or workflows. | Long change-control cycles, disruption to existing reports and inconsistent versions during transition. |
| Curated integration layer | Several legacy systems must feed one use while source applications cannot be changed quickly. | Duplicate logic, hidden lineage, added operational burden and divergence from later source fixes. |
| Documented exception and review queue | Defects are rare or ambiguous and a person can safely resolve them before action. | Backlogs, inconsistent decisions and overreliance on reviewers without capacity planning. |
| Model-side handling | The defect is well understood, low risk and measurable in evaluation. | It can conceal upstream errors, reduce explainability and fail when the data distribution changes. |
For each option, assess: connectivity to the real legacy sources; visibility into lineage and transformations; support for the quality checks and definitions your team needs; privacy, access and retention controls; integration and operating effort; and evidence from a pilot that the approach improves the target decision.
Independent reader supportYour contribution helps us test, update, and keep practical guides available for everyone.Pilot the full workflow with the legacy systems
Do not validate only a model file or a clean sample. NIST explicitly includes checking compatibility with legacy systems among deployment tasks and identifies regulatory compliance, organizational change and user experience as deployment concerns.
- Use representative records. Include normal cases, historical edge cases, missing fields, malformed records, delayed feeds and cases outside the intended scope.
- Exercise every interface. Test extracts, APIs, file drops, message queues, authentication, field mappings, character encoding, time zones and retry behavior.
- Test timing. Measure what happens when a source arrives late, arrives twice, contains only a partial batch or is unavailable.
- Test human handling. Show users uncertain outputs, explanations, overrides and escalation routes. Observe whether they understand what the system can and cannot support.
- Test fallback operation. Confirm that the legacy process can continue safely when the AI service, network, data feed or integration component fails.
- Record outcomes. Evaluate model metrics alongside data defects, processing errors, compliance findings, user experience and operational workload.
Assign deployment responsibilities among integrators, developers, operators, evaluators and domain experts. A successful offline evaluation does not prove that a batch job will arrive on time or that a user will act correctly on an uncertain recommendation.

Define release gates and rollback conditions
Turn the pilot into explicit go/no-go evidence. A release gate might require every input to have a documented owner and definition, critical mappings to pass reconciliation, exceptions to reach a staffed queue, access and retention approvals to be recorded, and users to demonstrate the fallback procedure. Set criteria that match the consequences of error; do not borrow a threshold from an unrelated application.
Before launch, name the person or group authorized to suspend the AI use. Specify the evidence that triggers review, such as a broken feed, a new population entering scope, a material shift in error patterns, an unapproved data use or a failure of the human fallback. Keep the previous process available long enough to compare outcomes and recover safely.
Monitor after deployment
Data quality can regress when a source application changes a code, a form is redesigned, a business process moves online or a new customer population appears. Monitoring should cover both inputs and consequences.
- Input health: delivery timeliness, volume changes, missingness, invalid values, duplicate rates and schema or code-list changes.
- Pipeline health: transformation failures, reconciliation differences, latency, retries and exception-queue backlog.
- Model and workflow behavior: error patterns, uncertainty, overrides, escalation rates and performance by relevant segment or operating condition.
- Outcome and impact: downstream decisions, user complaints, adverse events, privacy incidents and evidence that the use still serves its approved purpose.
Review assumptions whenever systems, populations, processes or feeds change. NIST treats risk management as continuing across the AI lifecycle and includes operation and monitoring as ongoing work, not a one-time acceptance test.
A practical readiness checklist
- The intended decision, users, operating context and consequences of error are written down.
- Every source, owner, definition, update cadence, transformation and known gap is mapped.
- Profiling covers missingness, definitions and units, invalid values, duplicates, staleness, coverage and lineage relevant to the use.
- High-impact defects have an upstream fix or a documented, tested exception path.
- Access, permitted use, retention, third-party dependencies and escalation routes are approved.
- The complete path has been piloted with representative records, real interfaces and real users.
- Fallback, suspension and rollback responsibilities are explicit and tested.
- Post-launch monitoring has named owners, review frequency and triggers for reassessment.
Use this list as an evidence register, not as a claim that the data is universally clean. The NIST AI RMF organizes related work into four functions—Govern, Map, Measure and Manage—which can structure ownership and review without becoming a pass/fail certification.
