Do these 3 things before closing this tab:
1Repair Windows errors before they cause bigger problems2Fix the driver behind crashes, sound loss and screen glitches3Clear out junk files and repair common Windows errorsA CUDA out-of-memory (OOM) error means your run exceeded available GPU memory at a particular point—loading, the forward pass, backpropagation, an optimizer step, evaluation, or checkpoint saving. The fastest reliable fix is to identify that point, measure live versus cached memory, then reduce the memory component responsible. Start with a smaller per-device batch, use gradient accumulation if you need the same effective batch, shorten sequences when acceptable, and enable gradient checkpointing. Only then tune precision, optimizer state, parameter-efficient fine-tuning (PEFT), quantization, or allocator settings.
First, identify what actually failed
Copy the complete exception, including the values for allocated, reserved, and free memory. Record the operation named in the traceback and whether the failure is repeatable. A model-loading OOM points to weight storage or device placement; a forward-pass failure usually points to activations or temporary tensors; a backward failure often indicates retained activations and gradients; an optimizer-step failure commonly implicates optimizer states or temporary update buffers; evaluation and checkpointing can create separate peaks.

memory_stats(), memory_summary(), and memory_snapshot() expose allocation patterns in more detail. A large gap between reserved and allocated memory can indicate cached blocks or fragmentation, but it does not prove that fragmentation caused the exception.
Understand the memory components competing for VRAM
Fine-tuning memory is the sum of several different demands, not just model weights:
- Weights: parameters loaded for the model, often in a lower-precision format when mixed precision is used.
- Gradients: tensors retained for trainable parameters after backpropagation.
- Optimizer state: extra tensors such as Adam’s first and second moments.
- Saved activations: intermediate results retained until backward computes gradients.
- Temporary operation tensors: short-lived attention, matmul, communication, or update buffers that create the peak.
- Allocator overhead and inactive blocks: reserved memory that may not be immediately usable for a new allocation.
Batch size and sequence length primarily increase activation pressure. Activations also scale with model depth and hidden size. In the attention formulation described by Hugging Face, attention score matrices grow quadratically with sequence length, so doubling the maximum sequence length can increase that part of the workload by about four times, subject to the model’s implementation and other dimensions.
A documented example, not a capacity formula
Hugging Face’s GPU memory usage documentation gives an illustrative configuration in which a 4-billion-parameter model trained in mixed precision with batch size 16 requires roughly 85 GB of GPU memory. The number depends on sequence length, architecture, optimizer, implementation, and other settings; do not use it as a universal estimate.
The same documentation describes one mixed-precision arrangement in which weights occupy about 6 bytes per parameter, Adam’s two FP32 moment states add 8 bytes per parameter, and FP32 gradients add 4 bytes per parameter, before activations and temporary allocations. Those figures explain why a model that fits for inference can still fail during training, but they are not a precise calculator for your run.
Fixes in the order that usually gives the clearest result
1. Lower the per-device batch size
Set per_device_train_batch_size to the largest value that completes a forward and backward pass, then increase gradually if desired. This directly lowers the number of examples whose activations must coexist on one GPU.
training_args = TrainingArguments(
...,
per_device_train_batch_size=1,
)
If the failure occurs only when increasing the batch, this is the first change to make. It may reduce throughput because fewer examples are processed per step, but it does not alter the model’s trainable parameters or numerical method.

2. Recover effective batch size with gradient accumulation
Gradient accumulation runs several small microbatches before an optimizer update. For example, a microbatch of 2 with gradient_accumulation_steps=8 approximates an effective batch of 16 (ignoring details such as remainder batches and distributed training).
training_args = TrainingArguments(
...,
per_device_train_batch_size=2,
gradient_accumulation_steps=8,
)
The immediate VRAM reduction comes from the smaller per-device microbatch. Accumulation does not make one example cheaper and does not remove the compute needed for the additional forward and backward passes. Excessive accumulation can slow training, as noted in Hugging Face’s GPU training performance and memory optimizations guidance.
3. Reduce maximum sequence length deliberately
Lower the tokenizer’s truncation limit or bucket examples by length when the task can tolerate less context. Shorter sequences reduce activation storage and attention-score memory. Do not truncate automatically when instructions, code, documents, or conversation history require the discarded context.
tokenized = tokenizer(
text,
truncation=True,
max_length=1024,
)
Dynamic padding—padding each batch only to its longest example—can avoid paying the maximum length for every item. Keep the model’s positional-encoding limits and task requirements in mind when choosing the value.
4. Turn on gradient checkpointing
Gradient checkpointing stores selected activations and recomputes them during the backward pass. It lowers peak activation memory at the cost of extra computation; Hugging Face describes roughly 20% slower training as a typical cost, not a guaranteed result for every model or GPU.
training_args = TrainingArguments(
...,
gradient_checkpointing=True,
)
Some models require an explicit model method or have checkpointing options that vary by Transformers version. Verify support in the model’s documentation and test loss behavior after enabling it. Checkpointing targets activations; it will not solve an OOM caused solely by optimizer states or weights.
5. Choose a precision your hardware and software support
Mixed precision can reduce activation storage and improve throughput, but its net memory effect depends on the implementation. Some training arrangements retain both lower-precision and full-precision copies of weights, so a small-batch run may not save as much memory as expected. Confirm device support and monitor loss for the selected model.

Current Trainer guidance generally prefers BF16 over FP16 when the GPU supports BF16 because BF16 is numerically more stable and does not require loss scaling. FP16 remains useful on hardware without BF16 support, but configure and validate it rather than assuming the two modes are interchangeable.

6. Reduce trainable-state memory with PEFT
Full fine-tuning keeps gradients and optimizer states for every trainable base parameter. Parameter-efficient fine-tuning freezes the base model and trains a smaller adapter set, substantially reducing those trainable-state allocations. It is most useful when diagnostics show that weights, gradients, or optimizer state—not activations—are the limiting component.
PEFT changes what is updated, so compare task quality with a full fine-tune when that distinction matters. The PEFT memory-efficient training guide covers adapter methods and their combinations with quantization.
7. Change optimizer state only when it is the bottleneck
Adam-style optimizers maintain two moment tensors, which can consume more memory than expected. Hugging Face documents 8-bit AdamW states as a way to reduce optimizer memory and lists Adafactor as another option with different memory and convergence behavior.

Pick the symptom - the matching free tool is one click away.
Optimizer swaps are not activation fixes. Check that the optimizer is supported by your model and training stack, then monitor convergence, loss curves, and reproducibility. A lower-memory optimizer can change update dynamics even when the model and data are unchanged.
8. Use quantization with an appropriate adapter workflow
Quantization can shrink base-model storage, and quantized base weights are commonly paired with adapter training. The supported quantization scheme, compute dtype, kernels, and model architecture determine whether a configuration is usable. Validate that the intended operations have compatible kernels and that quality remains acceptable; quantization is not a blanket replacement for reducing activation memory.

When allocator behavior is the issue
What empty_cache() can and cannot do
PyTorch’s CUDA semantics documentation explains that the caching allocator may leave unused blocks visible in nvidia-smi. This call releases unused cached blocks to other GPU applications:
torch.cuda.empty_cache()
It does not free live tensor allocations and does not increase the memory available for those tensors. Use it after deleting genuinely unused objects or between phases, not as a substitute for lowering a real peak.

If memory_stats() or memory_summary() shows many inactive split blocks and a large reserved-versus-allocated gap, fragmentation may be contributing. PyTorch documents the max_split_size_mb allocator setting as a last resort for the native backend in this situation. It can reduce fragmentation but may hurt performance and is ignored when the cudaMallocAsync backend is selected.
Do not add allocator environment variables merely because an OOM occurred. Measure first, change one setting, and compare the resulting peak and runtime.
Independent reader supportYour contribution helps us test, update, and keep practical guides available for everyone.Know when one GPU is simply too small
After reducing microbatch and sequence length, enabling checkpointing, selecting supported precision, and addressing trainable-state memory, the model may still exceed one device’s capacity. Multi-GPU sharding, parameter or optimizer offload, and a larger-memory device are possible capacity changes. They add communication, configuration, or transfer overhead, and the appropriate choice depends on model size, sequence length, batch target, and infrastructure.
The available guidance does not establish a universally recommended GPU or a purchase that will solve every workload. Measure the peak of your actual configuration before budgeting for hardware.

Failure patterns and targeted responses
It fails while loading the model
Reduce the loading dtype or use a supported quantized base, verify that no second process occupies VRAM, and place layers deliberately across devices. Activation-focused changes such as checkpointing cannot help until the model fits in memory.
Best Value
It fails only on long examples
Inspect padding and maximum length, use dynamic padding or length bucketing, and lower the limit if the task permits. Attention-related activation growth makes sequence length a particularly strong lever.
It fails at the optimizer step
Inspect optimizer-state allocation and consider PEFT, 8-bit AdamW, or Adafactor. Also check whether temporary gradients or update buffers coincide with the peak.
It fails during evaluation or checkpointing
Measure those phases separately. Evaluation batch size, generation length, retained logits, and checkpoint serialization can have peaks different from training. Configure evaluation and saving intervals and batch sizes independently where the framework allows it.
nvidia-smi shows memory, but tensors appear small
Compare memory_allocated() with memory_reserved() and inspect allocator statistics. Cached blocks explain some of the display; only evidence of inactive split blocks justifies fragmentation tuning.
A repeatable troubleshooting workflow
- Save the full OOM text and mark the failing operation.
- Record GPU, driver, CUDA, PyTorch, Transformers, model, optimizer, precision, batch, sequence length, accumulation, and concurrent processes.
- Measure allocated, reserved, and peak values immediately before the failure.
- Lower
per_device_train_batch_sizeuntil one microbatch completes. - Increase
gradient_accumulation_stepsonly if you need to recover effective batch size. - Reduce maximum sequence length or padding overhead when the task allows it.
- Enable gradient checkpointing and measure the new runtime and peak.
- Select supported BF16 or FP16 and verify numerical behavior.
- If state memory dominates, evaluate PEFT, an optimizer with smaller states, or a compatible quantized-adapter setup.
- Inspect allocator statistics before trying
empty_cache()ormax_split_size_mb. - Only after these measurements, evaluate sharding, offload, or additional GPU capacity.
Frequently Asked Questions
Does gradient accumulation prevent CUDA OOM by itself?
No. A smaller per-device microbatch lowers the immediate activation peak; accumulation then combines gradients across multiple steps. One individual example still requires the same memory.
Will torch.cuda.empty_cache() free tensors used by my model?
No. It releases unused cached allocator blocks, not live tensor allocations. Use allocation statistics to distinguish caching from a true live-memory peak.
Is BF16 always more memory-efficient than FP16?
No. The result depends on hardware, framework behavior, and whether full-precision copies are retained. BF16 is generally preferred for numerical stability when supported, but measure your configuration.
Why can a model fit for inference but not fine-tuning?
Training additionally needs gradients, optimizer states, saved activations, and temporary operation buffers, so its peak VRAM can be several times the inference footprint.
