How to Detect Unusual API Usage That May Indicate Model Extraction

Possible model extraction is rarely identifiable from one prompt. The practical approach is to compare each customer, key, tenant, endpoint, and model with its own benign baseline, then investigate coordinated changes in volume, query patterns, request size, errors, latency, geography, and timing. Treat the result as a lead—not proof—and use proportionate throttling, quotas, or review while you establish what happened.

What model extraction is—and why API monitoring matters

Model extraction is an attempt to approximate a protected model by querying it and collecting its outputs. In a classic query-based attack, the requester selects inputs that reveal useful behavior and uses the responses to train a “shadow model.” A related path is functional replication: the target API generates synthetic training data that is then used to fine-tune another foundation model. OWASP describes both scenarios in its LLM10: Model Theft guidance.

The same API can also be used for legitimate batch processing, evaluation, research, a product launch, or a newly popular integration. A single unusual prompt therefore has little evidentiary value. The useful signal is usually a coordinated pattern across a time window, identity, endpoint, or query distribution. Recent work explicitly frames detection as comparing traffic-window distributions with benign traffic rather than classifying isolated requests (Liu, Guo, and Dong, 2026).

No published industry-wide statistic establishes how often extraction occurs, and no detector can prove theft from telemetry alone. Detection should identify traffic that deserves investigation, while access controls limit the amount of model behavior any one client can cheaply collect.

Signals that deserve investigation

Use several independent signals together. A customer whose traffic is high-volume but follows its established schedule may be normal; a smaller account that suddenly sends broad, highly varied probes and requests unusually informative outputs is more concerning.

Signal What to measure Why it can matter Important alternative explanations
Volume and cadence Requests per minute or hour, bursts, sustained throughput, concurrency, and activity concentrated in unusual windows A sudden query-volume increase can accompany scraping, extraction, or denial-of-service activity. Google Cloud lists query-volume spikes among model-security anomalies (AI/ML security perspective). Product launches, customer growth, retries, scheduled batch jobs, or seasonal demand
Query sequence and distribution Repeated prompts, systematically varied inputs, consecutive-query distributions, topic coverage, and semantic distance from prior traffic Extraction often needs selected coverage of model behavior. PRADA analyzes distributions of consecutive queries (PRADA); newer work tests aggregate semantic traffic windows (2026 preprint). Automated testing, red-team exercises, a recommendation workflow, or a legitimate corpus-processing job
Request and response characteristics Request-size bands, response size where recorded, token counts, requested alternatives, and use of probabilities or log probabilities High-information outputs can make replication easier. OWASP advises limiting unnecessary exposure of logits and log probabilities (LLM10: Unbounded Consumption). Long documents, debugging, evaluation, or a feature that genuinely needs richer output
Operational changes Status and error codes, timeout rate, latency, retries, resource consumption, and model or endpoint changes Intensive automated querying may change error and latency patterns. Apigee documents volume, errors, request size, latency, geolocation, and related metadata as anomaly-model inputs (Apigee detection rules). Capacity incidents, deployments, dependency failures, or a client bug
Identity, geography, and time Credential, tenant, source network, location, first-seen clients, odd-hour activity, and changes from the identity’s own history Unusual locations and times can strengthen a combined signal. Google recommends geographic and temporal anomaly alerts (security guidance). Travel, VPNs, cloud egress changes, global users, or legitimate failover routing

Geography, IP reputation, or an odd hour should never be used as a standalone accusation. The question is whether multiple signals, interpreted against the right baseline, form a persistent and coherent pattern.

Build a benign baseline before setting thresholds

A threshold such as “more than 10,000 requests” is meaningless without knowing the endpoint, customer, model, and time period it describes. Establish normal behavior first, then alert on deviations.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Segment the baseline

  • Separate models, endpoints, API products, and inference modes. A chat endpoint and an embedding endpoint have different normal distributions.
  • Where policy and telemetry permit, segment by tenant, account, API key, service identity, and source network. Maintain both an identity-specific baseline and a peer-group baseline so that a new customer can be compared with similar customers.
  • Use multiple windows: short windows catch bursts, while daily and weekly windows expose sustained collection. Keep a calendar of launches, migrations, promotions, and planned batch jobs.
  • Include seasonality. Apigee’s documentation notes that historical examples can allow seasonal patterns to be learned; it recommends at least two weeks of history and says twelve weeks is preferable for more accurate anomaly models (documentation).

Define what “normal” means

Record distributions rather than only averages. For example, retain request-rate percentiles, token-count bands, error-rate ranges, latency percentiles, normal source regions, and the usual mix of models. A client whose average rate is normal but whose consecutive requests suddenly cover a wide semantic area may still warrant review.

Re-baseline deliberately after a documented product or customer change. Automatically absorbing every spike into “normal” can train the detector to ignore a slow extraction campaign.

Collect telemetry without creating a privacy problem

Detection requires enough context to connect requests, but retaining every raw prompt indefinitely creates its own security and privacy risk. OWASP’s Secure AI Model Ops Cheat Sheet recommends traceable logging while avoiding unnecessary exposure of sensitive data.

Useful fields

  • Timestamp with a consistent time zone, request ID, endpoint, model identifier, API version, and response status
  • Tenant, account, credential or service identity, source network, coarse location, and authentication result
  • Request and response token counts or size bands, concurrency, queue time, total latency, retry count, and timeout information
  • Whether the request asked for multiple candidates, scores, probabilities, log probabilities, tool traces, or other high-information output
  • Privacy-preserving query features such as length, language, topic or embedding summaries, duplicate rate, and a salted content fingerprint

Protect the telemetry

  • Minimize raw prompt retention and redact secrets, personal data, and customer content unless a defined investigation requires them.
  • Restrict log access, encrypt data in transit and at rest, define retention periods, and audit access to the logs themselves.
  • Keep enough immutable metadata to reconstruct an incident, including changes to rate limits, credentials, model versions, and detector rules.
  • Document the lawful purpose, access roles, and deletion process for any semantic features or sampled content.

Detection methods and what their results actually mean

Rate, quota, and metadata rules

Start with transparent rules: a sudden rate increase, excessive token use, an unusual error ratio, a new location combined with a new credential, or repeated requests for restricted output fields. Rules are inexpensive to explain and can trigger immediate protective controls, but attackers can stay below a fixed threshold or distribute activity across keys. Rules should therefore feed a broader investigation rather than serve as the only detector.

Query-sequence detection

PRADA proposed detecting model-stealing behavior by examining how the distribution of consecutive API queries departs from benign behavior (paper). The paper reports detection of all prior extraction attacks in its evaluation with no false positives in those tests. That result applies to the paper’s test set; it is not a guarantee for production traffic, a different model, or current extraction strategies. Sequence methods are most useful when you can safely derive query features and maintain a representative benign reference.

Aggregate traffic-window distribution testing

A June 2026 preprint by Shuze Liu, Qianwen Guo, and Yushun Dong embeds incoming queries in a semantic space and tests whether the distribution of a traffic window differs from historical benign traffic (preprint). The authors calibrate the threshold with benign-versus-benign comparisons. Their experiments report a 0.3% benign false-positive rate, 100.0% true-positive rate for pure-attacker traffic, a 90.5% average true-positive rate across attacker fractions, and 95.1% balanced accuracy.

Those figures came from fourteen attacker-normal query pairs across four extraction scenarios and three random seeds. They are experimental results, not expected field performance. Mixed traffic, different languages, new attack strategies, embedding choices, and a changing customer base can alter accuracy. Treat the method as a calibrated statistical signal and validate it on your own workload.

API-security platform anomaly models

Google Apigee documents a Preview Advanced API Scraper rule and an Advanced Anomaly Detection model that uses features including traffic volume, errors, request size, latency, and geolocation (Apigee detection rules). The documentation says customers must opt in to training on their API traffic, recommends at least two weeks of history and preferably twelve, and describes anomaly detection as environment-level rather than individual-proxy-level. Preview status, availability, and product behavior can change, so verify the current documentation before deployment.

Approach Primary evidence Strength Constraint
Rules and quotas Rate, tokens, errors, identity, time, and output fields Fast, explainable containment Can miss distributed or low-and-slow activity; thresholds need maintenance
Sequence analysis Distribution of consecutive query features Looks for coordinated probing rather than one prompt Original evaluation scope was limited; requires a suitable benign reference
Traffic-window testing Aggregate semantic distribution versus benign windows Can detect a campaign even when individual queries look ordinary Published metrics are from a small experimental evaluation, not a field guarantee
Platform anomaly model Metadata such as volume, errors, size, latency, and geography Combines operational signals and can fit existing API-security workflows Requires configuration, historical data, opt-in where documented, and confirmation of current product scope

A practical investigation workflow

  1. Open an alert with context. Capture the affected tenant or credential, endpoint, model, first and last timestamps, baseline comparison, and the signals that crossed their normal range. Do not label it “theft” at this stage.
  2. Check planned activity. Compare the window with a release, migration, evaluation, support case, customer batch job, retry storm, or known integration. Check whether a reliability incident explains the errors or latency.
  3. Look across identities and endpoints. Determine whether the behavior is isolated to one key, spread across many keys from one tenant, or correlated with a new source network. A campaign distributed across credentials is more informative than a single noisy client, but it still requires account-level evidence.
  4. Inspect query features safely. Compare duplicate rates, semantic coverage, request-size bands, output options, token use, and sequence distributions with the same client’s history and an appropriate peer group. Use sampled or redacted content only when authorized.
  5. Test persistence and coordination. Is the anomaly a five-minute burst, a daily pattern, or a campaign that continues after ordinary rate limits? Do independent detectors agree? Persistence and agreement raise confidence; a one-off event should generally receive a lighter response.
  6. Assign a risk tier. Consider model sensitivity, exposed output detail, customer impact, volume, duration, and whether credentials or model repositories were accessed. Keep the evidence and reasoning in the incident record.
  7. Contain proportionately. Begin with a token or request quota, concurrency cap, progressive backoff, or temporary throttle where service continuity matters. Escalate to credential suspension or network blocking only when evidence and contractual or security policy support it.
  8. Notify the account and preserve evidence when appropriate. A legitimate customer may explain a new workload or rotate a compromised key. Preserve relevant logs, configuration changes, and detector versions under your retention policy.
  9. Close the loop. Record whether the alert was benign, abuse, compromise, or unresolved; measure customer impact; and update the baseline, rule, or investigation playbook without silently weakening detection.

Controls that reduce extraction opportunity

Monitoring is more effective when the API limits how much useful behavior a single requester can collect. OWASP’s model-theft and model-operations guidance recommends layered controls (LLM10: Model Theft; Secure AI Model Ops).

  • Authenticate every call and authorize narrowly. Use separate identities for customers, internal services, evaluation jobs, and administrators. Apply least privilege to models, endpoints, repositories, and logs.
  • Set layered limits. Combine per-request token caps with per-user or per-tenant request, token, concurrency, and spend limits. A daily quota limits collection over time; a burst limit protects the service immediately.
  • Throttle adaptively. Increase delay or reduce concurrency for traffic that is anomalous, while preserving a clear path for verified batch customers. Avoid a single global limit that punishes all tenants for one account’s behavior.
  • Expose only necessary output. Do not return logits, log probabilities, full candidate distributions, internal traces, or debugging metadata to clients that do not need them. Limiting output probabilities is specifically identified as a mitigation for extraction and unbounded consumption (OWASP guidance).
  • Protect model assets. Audit access to model repositories, checkpoints, serving credentials, and deployment systems. OWASP advises regularly monitoring and auditing those access logs (LLM10: Model Theft).
  • Use data-loss and abuse controls where justified. Detect attempts to export sensitive prompts or responses, and ensure security monitoring itself does not leak customer content.

Common mistakes and how to correct them

Blocking on one spike

Problem: A launch or batch job looks like extraction. Correction: Compare with the account’s schedule, deployment calendar, token distribution, and query behavior; use a temporary quota or review queue while you verify.

Treating volume as proof

Problem: High traffic is declared model theft. Correction: Combine volume with sequence, semantic, output-detail, identity, and persistence signals. Google’s guidance identifies spikes as possible indicators, not conclusive attribution (security perspective).

Ignoring low-and-slow campaigns

Problem: Fixed per-minute limits miss activity spread across days or keys. Correction: Maintain daily and weekly views, aggregate by tenant and related credentials, and compare traffic-window distributions.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Retaining every prompt forever

Problem: Detection creates a second sensitive-data store. Correction: Prefer size bands, hashes, embeddings or other privacy-safe features, strict retention, access controls, and sampled review only under a defined purpose.

Trusting published accuracy numbers as a guarantee

Problem: A paper’s test result is presented as production accuracy. Correction: Reproduce calibration on representative benign traffic, measure false positives and missed cases, and report the evaluation scope whenever metrics are shared.

How to tune and measure the program

Track more than the number of alerts. For each detector, measure alert precision, investigation outcome, time to triage, missed incidents discovered by other controls, and the effect of throttling on legitimate customers. Break results down by endpoint, model, tenant type, geography, language, and workload pattern so that a detector does not appear accurate merely because it sees an easy subset.

Review thresholds after model, pricing, authentication, routing, or product changes. Version detector configurations and feature definitions so an analyst can explain why an event fired. Run benign-versus-benign calibration windows before changing a statistical threshold, and keep a holdout period when possible. Reassess whether a control still protects the model if an attacker changes prompts, spreads requests across accounts, or uses a different endpoint.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Use a documented escalation matrix. For example, a weak single signal can create an observation record; several independent signals can trigger a human review and temporary limits; evidence of credential compromise or unauthorized repository access can trigger incident response. The exact thresholds belong to your risk model, contracts, capacity, and privacy obligations—not to a universal number.

What a strong alert should contain

  • The identity, tenant, endpoint, model, source context, and exact time window
  • The client’s baseline and peer-group comparison, including the historical period used
  • Which signals changed: rate, sequence, semantic distribution, request or response size, errors, latency, location, time, or output detail
  • Detector version, threshold, confidence or score where available, and known evaluation limitations
  • Related deployments, incidents, support cases, and other credentials or endpoints
  • Recommended action, expected customer impact, owner, expiry time for temporary controls, and next review point

This format lets an investigator challenge the alert instead of accepting an opaque score. It also creates the evidence needed to tune rules without repeating the same false positive.

Bottom line for service teams

Detecting possible model extraction is a behavioral-monitoring problem. Establish segmented benign baselines, collect privacy-conscious metadata, and combine rate rules with sequence or aggregate-distribution analysis. Investigate account context and operational explanations before disruptive action. Then reduce the value of each query through authentication, least privilege, quotas, throttling, limited output detail, and audited access to model assets. The goal is not to prove intent from a prompt; it is to identify coordinated, persistent deviations early enough to protect the model and respond fairly.
