Make that choice with representative evaluations of your own workload—not a model’s size label, a leaderboard rank, or token price alone. For complex or high-consequence work, establish a capable-model baseline first, then test smaller models against it. If a smaller model misses the bar, determine whether the cause is model capability, prompting, missing context, tool use, or workflow design before paying for a larger model.
What “larger” and “smaller” mean in practice
There is no industry-wide parameter count or tier boundary that defines a small or large language model. Providers use different names, architectures, context limits, reasoning settings, and pricing structures. A model described as “small” by one provider may outperform a “large” model from another on a particular task.

Model selection is therefore a workload decision. A compact model may be entirely adequate for classification, extraction, routing, or a tightly constrained rewrite, yet struggle with ambiguous instructions, multi-step reasoning, long-horizon tool use, or unusual inputs. OpenAI makes the same distinction in A practical guide to building agents: a simple retrieval or intent-classification task may suit a smaller, faster model, while a difficult decision such as approving a refund may benefit from a more capable one.

Your objective is not to find the “best” model in the abstract. It is to find the least expensive and fastest model that clears a defined success threshold under the conditions in which your product will actually run.

Define the decision before testing models
Write the user-facing success condition
Translate “good quality” into an observable result. For an extraction task, success might require every invoice number and total to be correct, with valid JSON and no invented fields. For a support assistant, it might require a correct answer, appropriate citations, a safe escalation when the policy is unclear, and no disclosure of restricted information.
Separate mandatory requirements from preferences. A response can be well written yet fail because it omitted a critical field, violated a policy, called the wrong tool, or exceeded the product’s response-time limit.
Estimate the cost of failure
Classify the consequences of an error before choosing a model:
- Low consequence: a draft headline, internal categorization, or disposable summary can often tolerate occasional correction.
- Moderate consequence: a customer-facing answer, code suggestion, or workflow classification may require review, retries, or a confidence-based fallback.
- High consequence: financial, legal, medical, security, access-control, or irreversible operational decisions need stricter testing, human oversight, and a model or workflow that handles edge cases reliably.
Also record expected request volume, maximum acceptable end-to-end latency, available human review, data-residency requirements, and the tools or context the model must support. These constraints determine whether a theoretical quality advantage is usable in production.
Build an evaluation set that resembles production
Use real task diversity
Assemble examples from the inputs users are expected to send, including routine, ambiguous, rare, adversarial, and unusually long cases. Include the formats, retrieval context, tool definitions, system instructions, output schemas, and language variants that the deployed workflow will use. If privacy rules prevent using production records directly, redact or synthesize examples without removing the difficult structure.
Keep a held-out portion that is not used while tuning prompts. Otherwise, you can optimize the prompt to known examples and mistake memorization of the test set for general reliability. There is no universal number of examples: a diverse, high-risk task needs more coverage than a narrow, deterministic one. OpenAI’s model-optimization guidance recommends representative evaluations before changing prompts or adding capabilities.

Set pass criteria and graders
Define the acceptance rule before comparing models. Depending on the task, that can include exact-match fields, a schema validator, a human rubric, groundedness checks, tool-call correctness, refusal behavior, or a combination. For subjective output, score separate dimensions such as completeness, relevance, factuality, format adherence, and usefulness rather than relying on one overall impression.
Do these 3 things before closing this tab:
1Repair Windows errors before they cause bigger problems2Fix the driver behind crashes, sound loss and screen glitches3Clear out junk files and repair common Windows errorsFor agentic workflows, inspect the complete trial and transcript. A final answer can look plausible even when the agent used the wrong tool, skipped a required step, or reached the result through an unsafe action. Anthropic’s guidance on evaluating AI agents recommends examining trials, validating that graders represent genuine task success, and repeating variable runs to reveal inconsistent behavior.
Establish a baseline, then compare on the same workload
When to start with a capable model
For a complex or consequential task, first run a model you expect to be capable enough to solve the problem. This establishes a quality ceiling and exposes the task’s hard cases. You can then test smaller models against the same baseline instead of guessing whether a low score reflects an inherently difficult workload or an inadequate model.
An efficiency-first trial is reasonable for simple, high-volume, low-risk work, but it still needs representative testing. OpenAI’s API deployment checklist advises choosing the model that performs well on representative tasks rather than routing every request to the most capable model.
Hold the experiment constant
Run every candidate with the same prompt, input data, retrieved context, tools, output constraints, temperature or sampling settings where applicable, timeout policy, and grader. Record the model version and date. A provider can change a model’s behavior, availability, or pricing, so a result without those details is difficult to reproduce.
Compare the dimensions that affect a completed task
| Dimension | What to measure | Why it matters |
|---|---|---|
| Task success and accuracy | Pass rate against task-specific criteria; correctness of critical fields or decisions | Shows whether the model meets the actual need, not merely whether its prose sounds convincing. See OpenAI’s model-selection guidance. |
| Output quality | Completeness, relevance, factuality, format adherence, and usefulness | Captures quality differences that exact-match scoring misses. |
| Edge-case robustness | Results on ambiguous, rare, adversarial, contradictory, and unusually long inputs | Average scores can hide failures that dominate production risk. |
| Consistency | Repeated trials, variance, and types of failure | One successful run does not establish reliability when outputs are sampled or tools are involved. |
| Latency | End-to-end response time, including retries, tool calls, queueing, and escalation | A high-quality response is still a product failure if it misses the user’s response target. |
| Total cost per successful task | Input, output, reasoning, and cached tokens; retries; escalation; human correction | Token price alone does not reveal the cost of a completed, acceptable result. |
| Operational fit | Context capacity, tool compatibility, availability, data residency, privacy terms, and rate limits | A model must be deployable under your technical and geographic constraints. |
Report distributions, not only averages. For latency, examine the slow tail that affects user experience. For quality, separate routine success from edge-case failure. For cost, calculate the amount spent to obtain one accepted result after retries and review.

A step-by-step model selection procedure
- Describe the workload. List input types, expected volume, languages, context length, tools, output format, users, and the consequences of an error.
- Set measurable thresholds. Specify minimum task-success rate, critical-field accuracy, acceptable edge-case behavior, maximum latency, and cost per successful task. Mark which failures are never acceptable.
- Assemble and split examples. Build a representative set with normal and difficult cases, then reserve held-out examples for the final comparison.
- Choose a baseline. Use a capable model first when quality is uncertain or failures are costly. For a simple task, begin with a smaller model but do not skip the same evaluation discipline.
- Run identical configurations. Keep prompts, context, tools, output validators, sampling settings, and timeout rules constant. Log model version, token usage, retries, tool calls, and response times.
- Grade outcomes. Apply deterministic checks where possible and a documented human or model-assisted rubric where judgment is required. Inspect transcripts for agentic tasks.
- Test repeated and adversarial trials. Repeat variable tasks and add ambiguous, malformed, long, and hostile inputs. Record failure categories instead of collapsing everything into one score.
- Calculate total economics. Include retries, extra reasoning, fallback calls, tool costs, and human correction. Divide total spend by accepted outcomes, not by requests sent.
- Select the least expensive model that clears every hard threshold. If a candidate fails, test prompt, context, tool, and workflow changes before deciding that only a larger model can solve the problem.
- Document and schedule re-evaluation. Re-run the suite when the model version, prompt, tools, task distribution, or acceptance criteria change.
Three deployment strategies
Efficiency-first: start small and upgrade when a gap is proven
This approach fits high-volume, low-risk, well-defined tasks. Begin with a fast model, test thoroughly, and upgrade only the cases that miss the acceptance bar. It limits initial cost and latency, but it can underperform if your evaluation set is too easy or if failures are difficult to detect automatically.
Capability-first: establish quality, then downshift
Use a stronger baseline for complex reasoning, coding, long documents, or high-consequence decisions. Once the baseline behavior and difficult cases are understood, test smaller models and keep the larger model where the smaller one loses quality or reliability. This costs more during evaluation but reduces the chance of mistaking a weak baseline for an easy task.
Routed or hybrid: reserve capacity for difficult cases
A router can send routine requests to a smaller model and escalate uncertain or difficult cases. Escalation signals may include a failed validator, missing required fields, low retrieval support, a tool error, a detected ambiguity, or a second-pass judge. You can also use a larger model as an advisor for only the difficult portion of a workflow.
Measure the complete routed system. The router itself can misclassify requests, and extra calls add latency, cost, and operational complexity. A hybrid design is beneficial only when the savings and response times remain acceptable after routing errors, retries, and escalations are included.
Why the cheapest token price can lose
A smaller model may have a lower per-token rate but produce incomplete answers, require several retries, consume more output tokens, or need human correction. A larger model can sometimes be cheaper per successful task when it solves the request in one pass. Compare the full path:
cost per successful task = model calls + reasoning and cache tokens + retries and fallbacks + tool charges + expected human correction

A published example, not a universal rule
An Anthropic article reports a specific software-engineering setup in which a Sonnet 5 model paired with a Fable 5 advisor reached within 10% of Fable 5’s SWE-bench Pro score at 63% of the price of using Fable 5 for the whole task. This is a vendor-reported result for that configuration and benchmark, not a guarantee for another workload, provider, or model version. The same article says its plotted cost-performance curves are illustrative rather than benchmark measurements; they should not be treated as general data. See Anthropic’s explanation of model choice.
Independent reader supportYour contribution helps us test, update, and keep practical guides available for everyone.Diagnose a smaller model’s failure before upgrading
A poor result does not automatically prove that the model is too small. Classify the failure and test the least expensive correction:
- Instruction failure: clarify the task, add a short example, enforce a schema, or remove conflicting directions.
- Context failure: supply the missing facts, improve retrieval, shorten irrelevant context, or preserve the critical information within the model’s context limit.
- Tool failure: correct the tool description, argument schema, permissions, timeout, or error handling.
- Workflow failure: split a long task into verifiable stages, add a validator, or require confirmation before an irreversible action.
- Knowledge or reasoning gap: provide a stronger model, a specialized component, retrieval, code execution, or a human review step.
- Variability: repeat the trial, adjust sampling settings where appropriate, and add deterministic checks or a fallback.
OpenAI recommends representative evaluations before changing prompts or adding capabilities because otherwise you cannot tell which intervention fixed the problem. Test one meaningful change at a time when practical, and retain the original baseline for comparison.
Public benchmarks are signals, not a procurement decision
Benchmarks can help shortlist candidates, but their tasks, graders, harnesses, and contamination controls may not match your application. A score can be saturated, omit your languages or domain, or reward an answer style that users do not need. Examine the benchmark methodology and, where available, transcripts and evaluation details instead of treating a leaderboard rank as a deployment guarantee.
Your own held-out examples should decide whether a model is adequate. A benchmark is most useful when it explains a capability gap you can reproduce in your workload, not when it merely supplies a larger number for marketing material.
Best Value
Examples of applying the decision
Structured extraction
For extracting fields from standardized forms, start with a smaller model and a strict schema validator. Measure field-level accuracy, missing-field rate, invalid JSON, and the frequency of human corrections. Escalate documents with poor image quality, unfamiliar layouts, or conflicting values rather than routing every form to the largest model.
Customer support answers
Test a smaller model on grounded answers using the same retrieved policy text as the baseline. Grade factuality, citation or source use, refusal when the policy is silent, and escalation behavior. If the smaller model is fluent but invents exceptions on ambiguous cases, keep those cases on a stronger route or add a deterministic policy check.
Code generation and agentic tasks
Measure whether the code passes the relevant tests, not whether it looks plausible. Include multi-file changes, tool failures, incomplete requirements, and repeated runs. Inspect the transcript for unnecessary commands, skipped tests, and unsafe edits. A larger model may be justified for planning or debugging while a smaller one handles routine transformations.

Confirm that each candidate supports the context length, structured outputs, tools, concurrency, rate limits, regions, retention controls, and uptime requirements of your deployment. Availability and terms can change, so verify current provider documentation when you are ready to launch. Model names and tier charts are provider-specific and should not be treated as permanent rankings.
Monitor production after launch. Track acceptance rate, validator failures, escalations, retries, latency percentiles, token usage, cost per successful task, and user corrections. Sample successful outputs as well as failures: a hidden quality regression can pass technical validators. Keep a rollback path to the last known-good model and prompt.
When to repeat the comparison
Re-run the evaluation whenever a model version, system prompt, retrieval method, tool definition, output schema, sampling configuration, task mix, or acceptance threshold changes. Re-test after significant shifts in user language, document formats, traffic volume, or error costs. Store the evaluation set, grader version, configuration, and results so a future change can be compared with the same evidence.
Decision checklist
- Have you defined what an accepted result looks like for this exact task?
- Do you know which errors are tolerable, expensive, or unacceptable?
- Does the evaluation set include normal, ambiguous, rare, adversarial, and long inputs?
- Are prompts, context, tools, output constraints, and graders identical across candidates?
- Have you measured task success, quality, edge cases, consistency, latency, and total cost per successful task?
- Did you inspect agent transcripts and repeat variable trials?
- Have you tested prompt, context, tool, and workflow fixes before blaming model size?
- If you route requests, have you measured the router, escalation, retry, and fallback overhead?
- Are privacy, data residency, context limits, availability, and rate limits acceptable?
- Is there a re-evaluation trigger and a rollback plan?
The practical rule
Pick the smallest model that clears every hard quality and reliability threshold on representative, held-out tasks while meeting your latency, operational, and total-cost requirements. Use a capable baseline when the work is difficult or consequential; use a smaller default when testing proves it is sufficient; and route only demonstrably difficult cases upward. Revisit the decision whenever the workload or model changes, because model size is not a permanent proxy for task fitness.
