How to Choose an LLM Inference Provider for a Production Application

By Freedom251 Team · · 10 min read

Choose the inference provider that meets your application’s measured quality, latency, capacity, cost, data-governance and recovery requirements—not the provider with the most impressive general benchmark. Define the workload first, test the exact model and service route you may deploy, normalize the full cost, and verify quotas and contractual controls before committing.

Start with the workload, not the provider list

An inference provider is the service route that accepts your prompts and returns model outputs. The same model family can behave differently when exposed through a first-party API, a cloud-managed endpoint or a hosted arrangement because the API surface, quotas, regions, release schedule, processing roles and operational controls can differ.

  • Input and output token distributions (median, p95 and maximum), including the longest context your application will send.
  • Requests per minute, peak requests per second, concurrency and the shape of bursts.
  • Whether responses stream, the acceptable time to first output and end-to-end latency percentiles.
  • Required regions, data-residency boundaries and whether a cross-region fallback is permissible.
  • Availability target, acceptable queueing, retry behavior and what the application does when the model is unavailable.
  • Monthly token volume, budget ceiling and whether traffic can use caching, batch processing or provisioned capacity.
  • Required features such as tool calls, structured output, vision, embeddings, fine-tuning, content filters or a particular compatibility layer.

This specification prevents a common mistake: selecting a model on quality, then discovering that the chosen route cannot sustain the peak, store data in an acceptable geography or expose a required feature.

Separate model quality from service-route quality

Evaluate two decisions independently:

  1. Model selection: Does the model produce acceptable answers, tool calls and formats on your real tasks?
  2. Provider routing: Can the selected endpoint deliver those outputs with the required latency, capacity, controls and economics?

A generic leaderboard cannot answer either question for your application. Build a representative evaluation set from production-like requests, including difficult cases, long contexts, malformed inputs, tool failures and prompts that require abstention. Score factual correctness, task completion, format adherence, tool-use accuracy, refusal behavior and the amount of human review needed.

Keep model configuration constant while comparing routes wherever possible. Record the exact model identifier and version, system instructions, sampling settings, tool definitions, endpoint, region and account tier. If a provider silently updates a model or exposes a different snapshot, your result is no longer an apples-to-apples comparison.

Understand the main provider categories

Direct first-party APIs

A direct API is operated by the model developer and generally offers that developer’s own API semantics and feature-release path. Check project and organization controls, current rate limits, retention defaults, approved data controls, supported regions, model-deprecation policy and production support. OpenAI documents account-level limits, data controls and production practices; verify the settings for the specific projects and endpoints you will use rather than relying on a product-wide assumption (OpenAI data controls; OpenAI rate limits).

Cloud-managed inference

Cloud platforms can place multiple model families behind a cloud account, with regional deployment, cloud-native identity and billing, and platform-specific quotas. The endpoint matters. AWS currently documents both bedrock-runtime and bedrock-mantle; capabilities overlap, but some features are endpoint-specific. AWS says per-token pricing for the same model is identical between those endpoints, so choose the endpoint based on the API and features you need, not on an assumed token-price difference (AWS endpoint documentation).

On-demand capacity is regional. During high demand, a region can return capacity errors even when your average traffic is modest. AWS recommends estimating peak input and output tokens, response latency, concurrency and queueing tolerance for each model and Region, then adding headroom (AWS scaling guidance).

A model hosted on a cloud platform

Billing through a cloud account does not prove that the cloud operator runs every part of the service. Anthropic distinguishes Claude Platform on AWS, operated by Anthropic, from Claude in Amazon Bedrock, operated by AWS. The arrangements differ in API surface, quota ownership, data-processing role and feature-release schedule. Confirm the exact offer, processor relationship, geography and contractual terms before treating either route as equivalent (Anthropic’s AWS comparison).

Specialist hosts and self-hosting

Specialist hosts can be appropriate when a workload needs a particular open model, dedicated capacity or deployment pattern. Self-hosting adds responsibility for GPU procurement, serving software, autoscaling, patching, model licenses, observability and spare capacity. Treat these as separate business cases. Compare their measured results and current contracts with the same discipline as managed services; a lower token price alone does not establish a lower total cost or better reliability.

Turn requirements into measurable acceptance criteria

Quality criteria

  • Define pass/fail rules for each task type, not one overall score.
  • Measure structured-output validity, citation or grounding behavior, tool-call correctness and refusal handling.
  • Include a human-review sample for subjective outputs and safety-sensitive workflows.
  • Set a minimum acceptable pass rate and a maximum review rate before testing providers.

Service objectives

  • Set time-to-first-token and complete-response targets at p50, p95 and p99.
  • Set successful-completion and timeout targets separately from raw HTTP availability.
  • Define sustained throughput, burst throughput and maximum tolerated queue time.
  • Specify recovery objectives: retry, alternate region, alternate model or a user-visible degraded mode.

Do not publish a universal latency ranking. The available provider documentation supplies planning guidance, not a matched independent benchmark across providers, regions, model versions, prompt shapes and service tiers.

Run a controlled provider bake-off

  1. Freeze the test set. Use production-like prompts and expected outputs, including the observed token-length distribution and edge cases.
  2. Match configuration. Keep model version, system prompt, tools, sampling parameters, streaming mode and maximum output tokens equivalent where the APIs permit.
  3. Identify the route. Log endpoint name, region, account or workspace tier and any provisioned-capacity setting.
  4. Test realistic load. Run at expected average traffic, peak concurrency and burst shapes. Include cold-start and sustained periods when relevant.
  5. Capture complete telemetry. Store request and response timestamps, time to first output, total latency, token counts, status codes, queueing, retries and throttling events.
  6. Repeat at decision boundaries. A single short run can hide regional capacity variation. Repeat tests at the times and loads that matter to your service-level objective.
  7. Review quality and operations together. Reject a route that passes quality but violates latency, residency, quota or recovery requirements.

Keep the test record with the model version, endpoint, region, account tier, concurrency, retry policy and test duration. Those details are part of the result and make later regressions diagnosable.

Compare cost on equivalent usage

Token price is only one input to application cost. Build a monthly model using measured input and output volumes for the exact model, region and service tier. Include:

AWS’s live pricing page lists rates by model, region and tier. It states that selected foundation models offer batch inference at 50% lower price than on-demand pricing; eligibility and current rates must be checked for the model and region you actually select (Amazon Bedrock pricing).

Published figure or rule How to use it Qualification
Up to 30 days Model the possible exposure of abuse-monitoring logs when evaluating OpenAI API data controls. OpenAI’s current documentation describes this as a default for abuse-monitoring logs, subject to exceptions; it is not a universal retention period for every endpoint, feature, account or contract (source).
50% lower Consider batch inference where the workload is eligible and can accept batch timing. AWS describes this comparison for selected foundation models versus on-demand pricing; rates and eligibility can change (source).
Same per-token price across two endpoints Choose between bedrock-runtime and bedrock-mantle based on feature and API fit. AWS states that per-token pricing for the same model is identical between these endpoints; confirm the current model and regional listing (source).

Use a sensitivity table for traffic growth, output-length changes, retry rates and cache hit rates. A provider that is cheapest at average load may be more expensive after retries, provisioned headroom or a required second region is included.

Verify data governance and geography

Ask the provider to identify, for the exact endpoint and features you will call:

  • Who is the data controller or processor, and which subprocessors handle inference, storage and support?
  • What logs are created by default, what content they contain and how long they are retained?
  • Which controls are automatic, which require approval and which have endpoint or feature limitations?
  • Does a tool, file, conversation or stateful feature retain application data separately from the inference request?
  • Where are inference, transient processing, logging and backups performed?
  • Can data remain in the required country or region when failover or cross-region routing is enabled?
  • What contractual commitments cover deletion, security incidents, audits and government requests?

OpenAI states that API data is not used to train or improve its models by default. Its documentation also describes abuse-monitoring logs that may include customer content and be retained for up to 30 days, with exceptions. Zero Data Retention and Modified Abuse Monitoring require approval and have endpoint or feature limitations; some features can retain application state even when those controls are enabled. Review the current feature table and your contract before making a compliance claim (OpenAI data controls).

Anthropic’s retention documentation identifies Anthropic as processor for its direct Claude API and certain offerings, while the cloud provider is processor on Amazon Bedrock and Google Cloud’s Agent Platform. For an AWS route, Anthropic separately documents geography controls and notes that arrangements can differ by workspace creation date. Confirm the route, inference geography, processor role and retention terms rather than generalizing from the model name (Anthropic API and data retention; Claude Platform on AWS).

Plan for quotas, overload and regional failure

Quotas and throttling

Limits can apply to requests, tokens or other measures, vary by model and depend on account usage tier. OpenAI distinguishes temporary rate-limit or model-overload conditions from errors that require account or billing action. Implement bounded retries with exponential backoff and jitter, honor server retry hints where provided, and stop retrying non-transient errors (OpenAI rate-limit guidance).

Track quota utilization and document the increase path, lead time and maximum available capacity. A sales estimate is not a quota commitment; obtain the limit and escalation process in writing for the production account.

Regional capacity

AWS warns that regional on-demand capacity can encounter errors during high demand. Its guidance recommends workload headroom and bounded retries. Cross-region inference is an option only when the model is available in the target region and your data-residency policy permits routing there (AWS scaling guidance).

Application-level resilience

Use timeouts that match your user experience, circuit breakers for repeated failures, idempotency keys where supported and a queue for work that can be delayed. Cache deterministic or reusable results when policy permits. Load balancing and caching can reduce pressure, but they do not replace provider-capacity validation; OpenAI discusses these production practices in its guidance (OpenAI production best practices).

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Choose an endpoint and integration strategy

Start from required semantics rather than assuming compatibility. Compare request and response schemas, streaming events, tool-call formats, token-counting rules, error codes, authentication, file handling, safety settings and versioning. An abstraction layer should preserve the features your application needs while exposing provider-specific capabilities explicitly; pretending every API is interchangeable creates hidden quality and failure differences.

For AWS specifically, its official guidance says, “For most new applications, start with bedrock-runtime.” That statement is scoped to AWS endpoint selection, not a universal recommendation for every provider or workload (Amazon Bedrock scaling guidance).

Review the production contract

Before launch, obtain written answers for:

  • Committed availability, latency or throughput terms, service credits and exclusions.
  • Quota values, increase procedures, provisioning lead times and regional capacity options.
  • Model release, version pinning, deprecation notice and migration support.
  • Support hours, severity definitions, response targets and incident-reporting format.
  • Permitted use, content restrictions, audit rights, deletion commitments and subprocessors.
  • Billing-meter definitions, rounding, minimum commitments and treatment of failed or retried calls.

Recheck live pricing, model catalogs, regions, quotas and retention controls at the time of purchase. These change independently of your application code.

Design the escape plan before you need it

Estimate the cost of moving to another model or route: prompt and tool-schema changes, evaluation work, output-quality regressions, data migration, retraining of reviewers, dual-running costs and rollback time. Keep a provider adapter around authentication, retries, telemetry and billing, while allowing model-specific features to remain visible. Pin versions where possible and maintain a small regression suite that runs whenever a model, endpoint or region changes.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

For critical paths, define a fallback hierarchy in advance. It might be a second region of the same service, a second endpoint, a lower-cost model with reduced functionality or a queued asynchronous response. Each fallback needs its own quality, residency, quota and cost validation; a theoretical fallback that has never passed those checks is not a recovery plan.

A practical decision worksheet

Decision area Evidence to collect Release gate
Task quality Representative evaluation scores, failure examples, tool-use and format validity, human-review rate Every critical task meets its acceptance threshold
Latency and capacity Time-to-first-output, p50/p95/p99 completion, throughput, concurrency, queueing and error rates under peak load Objectives hold with documented headroom
Cost Measured token mix, retries, cache and batch assumptions, capacity charges and surrounding infrastructure Projected cost remains within the approved sensitivity range
Data governance Processor roles, retention, residency, feature-specific state and contract language Security and legal owners approve the exact route
Operations Quotas, increase path, support commitments, monitoring, incident process and deprecation policy On-call runbook and escalation contacts are complete
Portability Adapter coverage, version pinning, regression suite and tested fallback Recovery and migration time fit the business objective

The provider that wins this worksheet is the one that satisfies your constraints at an acceptable total cost. A broader model catalog or lower advertised token price cannot compensate for a failed quality gate, unavailable region or unacceptable data terms.

Product prices and availability are accurate as of the date/time indicated and are subject to change. Any price and availability information displayed on Amazon at the time of purchase will apply.
