Choose the model that meets your task’s measured quality and production constraints—not the model with the biggest headline benchmark. Start by writing down the exact workload, define acceptable and unacceptable outcomes, test a short list on representative examples, measure latency, throughput, cost, privacy and integration requirements, then document and monitor the decision.
A model that excels at text summarization may be unsuitable for image analysis, embeddings, audio, structured extraction or tool-using agents. The right choice is the one that delivers the required result reliably under your real data, risk, budget and operating conditions.

1. Define the workload before looking at models
Model selection becomes clearer when the business task is specific enough to test. Write a short workload specification before comparing vendors or model names. Microsoft’s guidance treats task fit, modality, context, security, region, deployment strategy, domain specificity, performance and tunability as selection filters. Microsoft’s workload-selection framework is a useful reference.
Write a task contract
Record the following facts in plain language:
- Business action: what decision, document, conversation or workflow the system supports.
- Inputs: text, tables, code, images, audio, video, sensor data or combinations of these.
- Outputs: free-form text, a classification, extracted fields, an embedding, a structured object, a ranking or an action through a tool.
- Users and operating context: employees, customers, analysts, regulated staff or automated downstream systems.
- Volume and concurrency: average and peak requests, batch jobs and simultaneous users.
- Response-time requirement: interactive, near-real-time, asynchronous or overnight.
- Error consequence: inconvenience, rework, financial loss, safety risk, discrimination, privacy exposure or an irreversible action.
- Data boundaries: permitted regions, retention rules, confidential information and whether data can leave your environment.
| Workload pattern | Capability to verify | Typical evaluation emphasis |
|---|---|---|
| Chat or drafting | Instruction following, factuality, tone and context handling | Useful answers, unsupported claims, refusal behavior and consistency |
| Classification or routing | Stable labels, calibrated confidence and structured output | Precision, recall, ambiguous cases and costly false positives or negatives |
| Extraction | Schema adherence, OCR or table understanding and missing-field behavior | Field-level accuracy, completeness and validation failures |
| Summarization | Long-context handling, source fidelity and controllable length | Omissions, invented details, attribution and readability |
| Embeddings or retrieval | Semantic representation and ranking quality | Recall of relevant material, precision of retrieved passages and index cost |
| Image, audio or multimodal work | Required input modality, resolution, transcription or visual grounding | Recognition errors, cross-modal consistency and accessibility |
| Tool use or agents | Planning, structured calls, recovery and permission handling | Task completion, unsafe actions, tool reliability and end-to-end latency |
Do not force one general-purpose model into every row. A smaller specialist, a separate embedding model or a conventional rules-based component may be a better fit for one stage of the workflow.

2. Define success, failure and explanation requirements
Turn the business objective into observable acceptance criteria. “Good answers” is not a test. Specify what must be correct, complete, safe, readable and useful, and identify errors that are never acceptable.
Set task-specific measures
- For extraction, decide which fields must be exact and how missing or conflicting values are handled.
- For classification, define the cost of each type of error rather than relying on a single accuracy number.
- For summarization or drafting, assess factual support, required coverage, tone, format and prohibited content.
- For retrieval-augmented responses, check whether the answer is supported by the supplied sources and whether relevant passages were retrieved.
- For agents, measure successful completion, correct tool selection, valid parameters, recovery from failures and prevention of unauthorized actions.
Include group-specific outcomes when people could be affected differently by the system. In higher-impact uses, decide whether users need an explanation, an appeal path or human review. UK Information Commissioner’s Office guidance says documentation should explain how application impact and data types affect model choice, why a less interpretable approach is used when applicable, and which accuracy, group-error, testing and monitoring measures are applied. See the ICO documentation guidance.
Separate pass criteria from preference scores
Some requirements are gates: a model that exposes confidential data, cannot produce the required schema or exceeds a safety threshold is rejected regardless of its average score. Other attributes, such as style or fluency, can be scored and weighted after the gates are met. Write both kinds of criteria before testing so the evaluation does not change to favor a preferred candidate.

- Collect real workflow examples. Use historical requests where permitted, plus cases created by subject-matter experts for uncommon or high-consequence situations.
- Cover the input distribution. Include ordinary requests, long and short inputs, incomplete information, unusual formatting, multilingual material where relevant and the edge cases your specification identifies.
- Create verified references. Have qualified reviewers validate expected answers, labels, extracted fields or source passages. Record acceptable alternatives when more than one answer is correct.
- Mark unacceptable behavior. Label hallucinations, privacy disclosures, unsafe recommendations, unsupported certainty, missing fields and unauthorized tool actions separately from ordinary quality errors.
- Keep evaluation examples independent. Do not choose only examples on which one candidate already performs well. Preserve a set that is not used to tune prompts or configure routing, then use it for a final check.
- Document the data. Record source, date, consent or usage basis, annotation method, known gaps and the version of each reference set.
AWS recommends validating business value with a capable model and then systematically evaluating smaller models for cost optimization. Its proof-of-concept guidance also emphasizes representative data, technical feasibility and deployment considerations. Read AWS model-selection guidance and AWS proof-of-concept guidance.
4. Create a short, practical shortlist
Compare a few candidates that could plausibly meet the task, rather than every model available. A useful shortlist normally contains:
- A current, proven model that establishes the quality level the business can achieve.
- A capable general-purpose alternative with different context, deployment or pricing characteristics.
- A lower-cost, faster or specialized candidate that still satisfies the modality and safety requirements.
This is a decision aid, not a mandated number of models. If only one candidate passes a hard requirement, document that fact instead of manufacturing a superficial comparison.
Quick wins for a faster PC:
Scan for outdated or missing drivers - takes under a minuteDriver Scan →Clear out junk files and repair common Windows errorsFree Scan →Run a controlled comparison
- Use the same evaluation examples, instructions, retrieved context, output schema and safety rules for every candidate.
- Pin the model identifier and version where the provider supports versioned deployments. Record sampling settings and any system instructions.
- Capture raw outputs, response times, token or request usage, errors and tool calls. Do not score only the final polished answer.
- Have reviewers score against the prewritten criteria. Blind the model identity where practical to reduce preference bias.
- Inspect failures individually. An average score can hide a small number of severe errors or a weakness concentrated in one user group or document type.
“Remember that the largest foundation model is not necessarily always the best model for your use case.” This is AWS guidance, not a guarantee that a smaller model will win; measure the trade-off on your workload.

5. Compare candidates on the same decision axes
Once candidates pass the basic task and safety gates, compare them using a scorecard. Keep measured values, reviewer notes and unresolved questions together so the decision can be audited.
| Axis | Questions to answer |
|---|---|
| Task and modality fit | Does the model natively handle the required input, output, tool calls, structured format and context length? |
| Quality | How correct, complete, factual, readable and useful are results against validated references? |
| Error profile | Which failures occur, how severe are they, and do rates differ across relevant groups or case types? |
| Explainability | Can the application provide an understandable basis for decisions, citations, confidence information or human review? |
| Latency and throughput | What is end-to-end response time at expected concurrency, including retrieval, tool calls, queues and post-processing? |
| Reliability | How often do requests time out, return malformed output, violate the schema or require retries? |
| Total cost | What does the complete workload cost, including input and output usage, compute, storage, egress, integration, monitoring and operations? |
| Data and security | Where is data processed, how is it retained, what encryption and access controls exist, and what contractual restrictions apply? |
| Deployment and region | Is the required region available through a managed API, platform deployment or self-hosted option? |
| Customization and maintenance | Can the team tune prompts, retrieval, adapters or fine-tuning, and can it maintain the integration as versions change? |
| Team fit | Does the organization have the skills and operational capacity to run the selected architecture? |
6. Test production constraints, not just answer quality
A model can win a quality comparison and still fail in production because it is too slow, expensive, difficult to scale or unavailable in the required jurisdiction. Test the whole path that a user or downstream system will experience.
Measure under realistic load
- Replay representative requests with the expected mix of short, long, simple and difficult cases.
- Increase concurrency to the expected peak and record median and high-percentile latency, queue time, timeout rate and retry rate.
- Measure throughput for both interactive and batch workloads. Include retrieval, moderation, tool calls, parsing and storage rather than timing only the model API call.
- Calculate cost per completed business task, not merely cost per token. Include failed attempts, retries, infrastructure, observability, data transfer and staff operations.
- Repeat tests after changing context size, retrieval depth, output length, batching or routing. These settings can alter both quality and economics.
For self-hosting, include accelerator hours, memory, storage, networking, upgrades, capacity planning and data egress. For managed services, examine quotas, regional availability, retention terms, incident commitments and portability. Microsoft and AWS both identify these operational and deployment constraints as part of model selection.
Do these 3 things before closing this tab:
1Repair Windows errors before they cause bigger problems2Fix the driver behind crashes, sound loss and screen glitches3Clear out junk files and repair common Windows errorsChoose a deployment pattern
| Pattern | Strengths | Costs and risks to test |
|---|---|---|
| Managed model API | Fastest start, provider-operated scaling and access to several model families | Usage charges, quotas, network dependence, provider changes and data-handling terms |
| Managed AI platform | Centralized evaluation, routing, monitoring, identity and governance controls | Platform fees, integration complexity and possible coupling to one ecosystem |
| Self-hosted or open model | More control over data location, versioning and customization | Hardware and operations burden, capacity risk, patching, model quality gaps and scaling work |
Do not treat self-hosting as automatically more private or managed APIs as automatically compliant. Verify the controls and contracts for the exact service, region and data type.

7. Choose the application approach as well as the model
The model is only one part of the system. Decide whether the task needs better instructions, external knowledge, adapted behavior or an orchestrated workflow.
| Approach | Use it when | Evaluate |
|---|---|---|
| Prompt or context engineering | General knowledge and clear instructions are sufficient, and the task can be expressed in a stable prompt | Instruction adherence, output format, robustness to wording changes and prompt-injection resistance |
| Retrieval-augmented generation | Answers must use private, proprietary or frequently changing source material | Retrieval recall and precision, source grounding, stale documents, access control and citation behavior |
| Fine-tuning or other adaptation | Repeated domain patterns or output behavior cannot be achieved reliably through prompting and retrieval alone | Quality gain against a held-out set, training-data rights, regression risk, versioning and retraining cost |
| Agent or tool workflow | The task requires planning, multiple steps or actions in external systems | Tool-call correctness, permissions, recovery, loop prevention, latency, audit logs and human approval points |
Start with the simplest approach that meets the acceptance criteria. A more elaborate architecture introduces additional failure modes and operational work. For agentic systems, test the tools and permissions as rigorously as the language model: a fluent plan is not evidence that an action is safe or correct.
8. Add privacy, security and regulatory requirements
Model selection is also a governance decision when outputs influence people, finances, health, employment, access or other consequential outcomes. Record what data the system receives, who can access it, how long it is retained, where processing occurs and how incidents are handled.

United Kingdom
The ICO’s documentation guidance is UK-focused. It calls for recording the domain’s transparency requirements, how application impact and data type influence model choice, why a less interpretable approach is used where applicable, the explanation and risk controls provided to users, selected metrics, group-specific error rates where relevant, testing, monitoring frequency and model-version changes. Apply the guidance to the extent it matches your role and processing activity; it is not a universal certification checklist.

European Union
The European Commission states that obligations for providers of general-purpose AI models entered into application on 2 August 2025, with its enforcement powers beginning on 2 August 2026. The Commission describes provider duties concerning technical documentation, copyright policy and summaries of training content, with additional evaluation and risk-mitigation duties for models posing systemic risks. These are provider obligations under the EU AI Act, and applicability depends on the organization’s role, system and facts. Consult the Commission guidelines for providers of general-purpose AI models and its AI Act questions and answers.
United States banking context
The Federal Reserve’s interagency supervisory guidance on model risk management is dated 17 April 2026. It covers banking organizations’ model-risk management, but says generative and agentic AI models are outside its scope. It also notes that governance practices should guide controls for tools and systems not covered directly. Do not present it as a generative-AI rule; use it as context when a banking organization’s broader model-risk program applies. See the Federal Reserve guidance.
9. Make the decision auditable
Before production approval, create a decision record that another team can understand months later. Include:
Free tools Windows power users keep installed
One-click scans. No signup required.
- The business task, users, modalities, volume, latency target and error consequences.
- Candidate model names, providers, deployment locations and exact versions or release identifiers.
- The evaluation-set sources, date, composition, reference-answer process and known limitations.
- Results by quality dimension, case type and relevant user group, plus the severe failures found during review.
- Load-test results, cost assumptions, quotas, context requirements, retry behavior and operational dependencies.
- Privacy, security, data-retention, region and compliance assessments, including unresolved exceptions and their owners.
- The reason for choosing prompt engineering, retrieval, adaptation or an agent architecture.
- Human-review rules, escalation paths, access controls, logging and incident-response procedures.
- Monitoring owner, review frequency and the conditions that trigger a new evaluation.
Document trade-offs explicitly. If a faster model is selected despite lower average quality, state which errors are acceptable and what controls compensate. If a more capable model is selected despite higher cost, state the business value that justifies it.
10. Monitor and revisit the choice
A model decision is not permanent. Providers change model behavior, availability and limits; your data distribution, traffic and requirements also change. Monitor quality and operations after launch, not only during the pilot.
- Sample production cases for expert review and compare them with the original acceptance criteria.
- Track schema violations, unsupported claims, refusal rates, tool errors, latency, throughput, retries and cost per completed task.
- Watch for drift in document formats, user language, product policy or retrieval sources.
- Record every model, prompt, retrieval-index and tool-permission change with its effective date.
- Re-run the evaluation when a model version changes, a provider changes terms or region, the workload shifts, a new user group is added, or monitoring reveals a material regression.
Keep a rollback path: a previously evaluated model or a human-only workflow should remain available for failures, outages and emergency changes.
11. Common selection mistakes and their fixes
| Mistake | Why it fails | Fix |
|---|---|---|
| Choosing from a public leaderboard alone | Broad benchmarks may not represent your inputs, output format, risks or costs | Use them only to screen, then test a validated task-specific set |
| Assuming the newest or largest model is best | Capability can bring higher latency, cost or unnecessary complexity | Include a lower-cost or specialized candidate and compare on identical cases |
| Optimizing the average score | Averages hide severe, rare or group-specific failures | Review failure cases, slices and hard safety gates |
| Timing only the model call | Retrieval, tools, parsing and queues often dominate user-visible latency | Measure the complete end-to-end workflow under expected concurrency |
| Ignoring context and data boundaries | Truncation, leakage or unavailable regions can invalidate an otherwise good model | Test maximum inputs, retention, access controls and regional deployment before approval |
| Changing prompts and models together | You cannot tell which change caused an improvement or regression | Version prompts, retrieval settings and models separately and test controlled changes |
| Launching without ownership | Quality drift and model-version changes go unnoticed | Assign monitoring, incident and re-evaluation owners in the decision record |
What a defensible choice looks like
A defensible selection links one defined business task to one documented evaluation, one measured operating profile and one set of controls. It explains why the chosen model meets the required quality and safety gates, how its cost and latency fit the workload, where data is processed, which failures remain, and when the team will test again. That process is more reliable than selecting by reputation, parameter count or a single benchmark.
